Most software problems do not require an AI agent. If a task follows stable, explicit steps, deterministic automation is usually easier to test, secure, operate, and budget. If one part of that process requires interpreting language or making a bounded judgment, add an LLM step inside the fixed workflow. Choose an agent only when the system must adapt to changing context, select its own tools, or decide which steps to take next.

This is a control-flow decision, not a marketing-label decision. The right architecture may combine ordinary code, one carefully constrained model call, and—only where justified—an agentic loop. The more autonomy you add, the more you must manage latency, cost, permissions, observability, and the possibility that small mistakes compound across several actions.

How do I decide whether a task needs an AI agent?

Start by asking whether you can specify the workflow’s steps, branches, inputs, and success conditions in advance. If you can, write that path in code first. If the path is fixed but one stage needs language interpretation, use an LLM at that stage. An agent becomes a candidate when the sequence itself is difficult to predict and the system must choose actions dynamically.

Use this order of preference:

  1. Deterministic automation: coded rules execute a known sequence.
  2. LLM-assisted workflow: a predefined sequence contains one or more bounded model calls.
  3. Agent: an LLM manages execution and selects tools or next steps as it works.

Anthropic’s guidance is to “find the simplest solution possible, and only increase complexity when needed.” That principle prevents teams from turning a reliable script into an autonomous system merely because a model is available.

What is deterministic automation, and when is it the best choice?

Deterministic automation uses explicit code, rules, schedules, and integrations. Given the same valid inputs and system state, it follows the same path. AWS Prescriptive Guidance puts the design rule plainly: “Implement coded logic for deterministic execution. Use AI functionality where it provides value that deterministic code cannot.”

Good candidates for coded automation

  • Copying approved data from one system to another on a schedule.
  • Applying a known eligibility formula to complete records.
  • Generating an invoice when a payment event arrives.
  • Running a fixed deployment, backup, or report-generation sequence.
  • Routing requests by a small, stable set of fields such as region, account type, or severity.

Deterministic code makes the allowed transitions visible. You can unit-test each branch, reject invalid input before an action, retry a failed API call predictably, and prove which rule produced an outcome. It also limits permissions: the process can be granted only the API access needed for its fixed path.

That does not mean code is always simple. Rules can become cumbersome when policies change or input formats vary. However, a maintenance problem is not automatically an agent problem. First consider configuration, a rules engine, better data validation, or a small interpretation step before replacing the whole process with open-ended decision-making.

When is an LLM step inside a workflow enough?

An LLM step fits when the overall process is known but one stage involves language, classification, extraction, or a bounded judgment that is awkward to express with rules. The surrounding application still controls the sequence, permissions, retries, and final side effects.

Typical bounded uses

  • Extracting fields from an email or document into a validated schema.
  • Classifying a support message into a predefined queue.
  • Summarizing a call before a human review step.
  • Drafting a response from an approved knowledge base, with a policy check before sending.
  • Determining which of a finite set of known templates best matches a request.

In this design, the model does not decide what the application should do next in an unrestricted way. Your code calls it at a known point, supplies a constrained prompt and schema, validates the result, and then continues along predetermined branches. OpenAI’s business guidance describes this as the middle ground between ordinary automation and an agent.

Keep the model’s output narrow. Ask for a structured result, enforce enumerated values, set confidence or escalation rules where appropriate, and treat malformed output as an error to handle—not as permission to improvise. If the model cannot make a safe determination, route the item to a person or a deterministic fallback.

What makes an AI agent different from an LLM workflow?

An agent is not simply any application that calls an LLM. OpenAI defines an agent as a system that uses an LLM to manage workflow execution and dynamically select tools to interact with external systems. Anthropic contrasts a workflow—LLMs and tools orchestrated through predefined code paths—with an agent, in which the LLM dynamically directs its own process and tool use.

Agent characteristics

  • Dynamic control flow: the model chooses which action or tool to use next.
  • Context-sensitive planning: it can revise its approach when new information arrives.
  • Multiple steps: it may inspect data, call a service, evaluate the result, and continue.
  • Open-ended inputs: requests may not fit a fixed template or known sequence.
  • Delegated execution: the application grants tools and lets the model determine how to reach a goal.

Agents are useful when the number and order of steps cannot be reliably specified in advance. They can investigate a problem across several systems, choose among tools based on findings, and recover from an unexpected intermediate result. That flexibility is the point—and the source of their operational risk.

What is the difference between automation, an LLM workflow, and an agent?

The following comparison focuses on control and operating consequences rather than product labels.

Approach Control flow Best fit Main strengths Main concerns
Deterministic automation Written in advance by developers Predictable, repetitive work with explicit steps Stable behavior, straightforward testing, bounded permissions Rules may be brittle when inputs or policies change
LLM step in a workflow Application controls the path; model handles a bounded stage Fixed processes containing interpretation or judgment Handles language and variation without surrendering orchestration Model errors, validation work, and per-call cost
Agent Model selects next steps and tools dynamically Context-sensitive, multi-step, open-ended work Adaptability when a complete plan cannot be written up front Higher uncertainty, latency, cost, permission, and monitoring burden

None of these options has a universal performance or break-even threshold. The sources provide qualitative selection guidance, not a promise that agents are faster, cheaper, or more accurate in every implementation. Measure your own workflow after you have defined acceptable error and escalation behavior.

Can one example show where each approach fits?

Consider a hypothetical team that receives customer requests about a delayed shipment. The example is illustrative, not a report of observed testing.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Deterministic version

If every request arrives from a structured form containing an order number and a status code, code can look up the shipment, apply a fixed service-level rule, and send one of several approved notices. No model is needed.

LLM-assisted version

If customers write free-form messages, keep the same lookup and policy path but use an LLM to extract the order number, identify the issue category, and return a constrained object. The application validates that object, checks the order, and selects the response template. A missing order number or low-confidence classification goes to a human queue.

Agent version

If a request may require checking several carriers, reading previous correspondence, comparing changing policies, opening a case, and deciding which investigation to perform next, an agent could select those tools dynamically. It would need narrowly scoped credentials, limits on actions, a record of every tool call, and a clear handoff when evidence is incomplete.

The third design is justified only if the first two cannot cover the real variation without an unmanageable set of rules. Making the agent responsible for routine lookups that code can perform adds autonomy without adding useful capability.

What questions should I ask before choosing an agent?

Evaluate the workflow against each dimension below. A “yes” in one category is not enough by itself; the decision depends on the combination and on the consequences of a wrong action.

Are the steps stable and predefinable?

Write the process as a flowchart or state machine. If every normal case follows the same sequence and exceptions are enumerable, deterministic automation is the default. If you cannot describe what happens after each possible result without continually adding special cases, investigate whether a bounded model step solves the ambiguity before adopting an agent.

How much interpretation or judgment is required?

Separate judgment about content from judgment about control. Classifying a paragraph into five known categories is usually an LLM-step problem. Deciding which investigation to launch, what evidence to gather next, and when the goal is satisfied is closer to an agent problem.

Are inputs unstructured or constantly changing?

Free text, documents, images, and inconsistent terminology increase the value of language understanding. They do not automatically require dynamic planning. Use extraction or classification with schemas when the downstream actions remain fixed.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How hard are the rules to maintain?

Count policy changes, exception paths, and the number of teams that must update the logic. A large rule set may justify a model for interpretation, but retain explicit code for authorization, financial limits, safety checks, and other non-negotiable constraints. Do not hide a policy decision inside a prompt when it must be auditable.

Does the system need dynamic tool use?

List the tools and ask whether their order can be chosen from known conditions. If the application can select the right API with ordinary branching, keep that choice in code. An agent is more defensible when new evidence determines which tool to call next and no fixed sequence covers the cases.

What are the latency and cost limits?

Agent loops can involve several model calls and tool calls. Anthropic describes a cost and latency tradeoff, and notes that errors can compound as a system takes more steps. Establish a maximum number of iterations, a time budget, and a spending limit per task before production deployment.

What happens if the system is wrong?

For low-impact drafting, a human can review the result. For account changes, payments, deletion, security controls, or messages sent to customers, require explicit authorization and deterministic policy checks. The higher the consequence, the less freedom the model should have to perform irreversible actions.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Are AI agents worth the extra cost and complexity?

They can be worth it when flexibility solves a problem that fixed code or a bounded LLM step cannot solve economically or operationally. They are not automatically worth it because they sound more advanced. The value case should identify a specific capability—such as handling unpredictable investigations across approved systems—and compare it with the cost of maintaining rules, reviewing failures, and operating the additional controls.

Expect more than model usage fees. An agent requires tool adapters, authentication boundaries, state and memory decisions, traces, evaluation cases, timeout handling, and human escalation. Each additional step creates another place for an incorrect assumption to influence later actions. Budget for monitoring and incident response, not only for inference.

Conversely, a deterministic workflow can also become expensive when every policy variation requires engineering work or when unstructured requests are forced through brittle parsing rules. The practical objective is minimum necessary complexity: use AI where it adds value that deterministic code cannot, and leave the rest explicit.

How should I validate an agent before giving it autonomy?

Start with a bounded experiment that can fail safely. Anthropic recommends sandbox testing and guardrails for autonomous systems.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Define the goal and stop conditions. State what counts as success, when to stop, and when to escalate.
  2. Limit the tool surface. Expose only the APIs required for the test, with read-only access where possible.
  3. Use representative cases. Include ambiguous requests, missing data, conflicting records, and malicious or irrelevant instructions.
  4. Require structured actions. Validate arguments against schemas and reject unknown operations.
  5. Simulate side effects first. Run in a sandbox or dry-run mode so the agent cannot send, purchase, delete, or modify real records.
  6. Capture a trace. Record prompts, model outputs, tool calls, responses, retries, and the reason for each escalation.
  7. Review failure patterns. Look for repeated tool calls, unsupported assumptions, policy violations, and cases where a fixed branch would have been safer.
  8. Expand permissions gradually. Promote only actions that meet your accuracy, safety, and audit criteria; keep irreversible steps behind approval.

This process can reveal that only one part of the workflow needs adaptation. In that case, remove the agent loop and retain a constrained LLM step or ordinary code.

Should I build a multi-agent system?

No. Multiple agents are not the default next step. OpenAI’s practical guide recommends maximizing a single agent’s capabilities first and splitting work only when complexity or overlapping tools makes the separation worthwhile.

Separate agents can make ownership and tool boundaries clearer, but they also add coordination, messaging, state synchronization, and more opportunities for compounding errors. A single agent with well-designed tools and explicit guardrails is often easier to evaluate. Introduce multiple agents only when distinct roles have genuinely different instructions, permissions, or contexts and the handoffs can be tested.

What architecture keeps an agent controllable?

Treat the agent as one component inside a larger system, not as the owner of every decision.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Keep policy outside the model: authorization, spending limits, data retention, and safety rules should be enforced in code.
  • Design narrow tools: expose specific operations with typed arguments instead of a general database or shell.
  • Separate planning from side effects: require a review or policy gate before irreversible actions.
  • Make state explicit: store task status and evidence so a retry does not silently repeat an action.
  • Set resource limits: cap steps, time, tokens, and tool retries.
  • Provide human handoffs: include the relevant context and proposed next action, not just an error message.
  • Observe every decision: retain traces that let operators reconstruct what happened.

These controls do not turn an agent into deterministic software; they bound its authority so its adaptive behavior occurs inside a system you can inspect and stop.

What is the practical recommendation?

Choose the least autonomous design that reliably meets the requirement. Start with explicit code for predictable work. Add an LLM where interpretation or judgment is bounded. Move to an agent only when context-sensitive decisions and a dynamically changing sequence are central to the task, then validate that autonomy in a sandbox with narrow tools and clear escalation.

A sound workflow can contain all three approaches. The whole process does not need to become an agent for one difficult step to benefit from language understanding.

Frequently Asked Questions

Can an AI agent run safely with read-only access?

Yes. Read-only tools let an agent investigate records without changing them, which is a useful first deployment mode. You still need limits on data exposure, prompt-injection defenses, timeouts, and a human path for any action that would later require write access.

How do I measure an agent’s reliability?

Create a test set that represents normal, ambiguous, and adversarial requests, then score task completion, policy violations, unnecessary tool calls, and escalation quality. Review full traces rather than judging only the final text, because an apparently correct answer may have used an unsafe or unauthorized path.

What is prompt injection in an agent workflow?

Prompt injection is untrusted content that attempts to change the model’s instructions, such as a document telling the agent to reveal secrets or ignore its task. Treat retrieved text as data, keep secrets out of model-visible context where possible, and enforce permissions in tools and application code rather than relying on instructions alone.

When should a human approve an agent’s action?

Require approval before irreversible, costly, legally sensitive, or externally visible operations. The approval screen should show the requested action, arguments, evidence used, and expected effect so a reviewer can make a quick, informed decision.
