Yes, but “consistently” must be defined. A model can run without network access on multiple GPUs when its checkpoint, tokenizer, runtime libraries, and other dependencies are stored locally. However, offline operation does not make outputs identical. Different GPU architectures, floating-point behavior, kernel choices, software versions, precision settings, and random-number handling can produce different bits, slightly different values, or different generated tokens. Decide whether you need bit-for-bit equality, values within a numerical tolerance, or the same task-level result, then test the exact model and target GPUs under fixed conditions.
What does “consistent” mean for an AI model on different GPUs?
There are three progressively weaker meanings of consistency. A reproducibility test is only meaningful when you state which one you require.
| Consistency standard | What must match | Practical implication |
|---|---|---|
| Bitwise equality | Every output bit, tensor value, and usually intermediate result | The strictest target. It can fail when operation order, kernels, hardware, or library versions differ. |
| Numerical closeness | Values remain inside a declared error tolerance | Often suitable for scoring, classification, or scientific calculations, but the tolerance must be justified for the model and task. |
| Task-level agreement | The application reaches the same accepted outcome | Useful for production workflows, yet generated text can change even when two answers are semantically similar. |
PyTorch defines deterministic behavior around the same inputs, software, and hardware; that is a narrower promise than agreement between GPU architectures. Its documentation also warns that completely reproducible results are not guaranteed across releases, commits, or platforms. NVIDIA similarly states that floating-point computations are not guaranteed to be identical across processor architectures.

Usually, yes, provided every file needed for inference is available locally and the GPUs are supported by the installed software. “Offline” describes where the model and dependencies come from; it says nothing about numerical reproducibility.

Files and components to keep local
- The exact model checkpoint or set of weight shards.
- The tokenizer files, vocabulary, merges, and model configuration.
- The inference framework and its dependent packages.
- The CUDA or other accelerator toolkit components required by the framework.
- Any custom operators, compiled extensions, attention backends, and launch scripts.
- Generation settings, preprocessing code, and test inputs.
Drivers still have to be installed and compatible with each target GPU. Verify the model’s license and any model-specific packaging or download conditions separately; the general reproducibility guidance does not establish those requirements. An offline bundle should be copied and hashed so that each machine uses the same bytes, not merely files with the same names.
Why can the same model produce different results on different GPUs?
Floating-point addition depends on order
Floating-point addition is not associative: calculating (a + b) + c can round differently from a + (b + c). GPU kernels parallelize reductions and matrix operations, and another architecture may schedule or group partial sums differently. The resulting differences can be tiny at first but can affect later layers and eventually a decision or generated token.
Precision and accumulation choices change the arithmetic
Two machines may run the same checkpoint with different supported precisions or accumulation paths. Even when the advertised dtype is the same, a backend can use a different kernel implementation. Keep dtype, autocasting, quantization settings, and accumulation behavior fixed when comparing devices; otherwise you are testing different numerical programs.
Random operations and nondeterministic kernels add variation
Sampling, dropout left enabled, randomized preprocessing, and custom code can consume random numbers. Seeds control random-number sources but do not eliminate hardware or kernel differences. Some operations have nondeterministic implementations; if no deterministic alternative exists, a framework may be unable to provide repeatable results.
Backend and version selection matters
Attention and convolution backends can accumulate values in different orders. PyTorch notes that scaled dot-product attention implementations may do this, and that cuDNN benchmarking can select different convolution algorithms because benchmark noise and hardware affect the choice. A different PyTorch, CUDA, cuDNN, compiler, or driver release can therefore alter results even on nominally similar hardware.

How should I test cross-GPU consistency offline?
Use the following workflow for the actual model, inputs, and GPUs you intend to deploy. It separates repeatability on one device from agreement between devices.
- Choose the acceptance rule. Record whether you require bitwise equality, a numerical tolerance, or a task-level criterion such as an accuracy score, exact label, or approved answer set. Do not choose a universal tolerance without measuring what the task can tolerate.
- Freeze the experiment. Use one checkpoint hash, tokenizer, preprocessing pipeline, input corpus, framework and toolkit versions, dtype, backend selections, batch shape, sequence length, and generation parameters. Keep evaluation order fixed.
- Control random sources. Set seeds for the framework and every random-number generator used by your application or dependent libraries. Ensure evaluation mode is enabled where appropriate so training-only randomness is not active.
- Enable deterministic implementations where available. In PyTorch, an appropriate starting point is:
import random
import numpy as np
import torch
seed = 1234
random.seed(seed)
np.random.seed(seed)
torch.manual_seed(seed)
torch.cuda.manual_seed_all(seed)
torch.use_deterministic_algorithms(True)
torch.backends.cudnn.benchmark = False
This is a PyTorch/CUDA-specific control set, not a universal recipe. torch.use_deterministic_algorithms(True) requests deterministic implementations and raises an error when PyTorch knows an operation has no deterministic alternative. It does not silently make every custom operator or external library deterministic. The setting can also reduce performance.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
- Establish a per-GPU baseline. Run the same input repeatedly on GPU A and then repeatedly on GPU B. If one device disagrees with itself, fix randomness, evaluation mode, algorithm selection, or an unsupported operation before investigating cross-device differences.
- Compare across devices. Save raw tensors or logits when possible, calculate the declared numerical error, and evaluate the task-level criterion. Record GPU model, driver, framework, toolkit, backend, dtype, seeds, and configuration with every run.
The six steps create a defensible test, but they do not guarantee a particular result. A model may pass a task-level test while failing bitwise comparison, or fail exact comparison while remaining within a useful numerical tolerance.
Does PyTorch deterministic mode guarantee identical outputs across GPUs?
No. Deterministic mode addresses known nondeterministic operations within the supported software and hardware context. It does not promise that mathematically equivalent floating-point computations will produce identical bits on different platforms or GPU architectures.
Disabling cuDNN benchmarking can stabilize convolution algorithm selection, while deterministic-operation settings address another source of variation. These controls should be tested together with the model’s actual operators. If deterministic mode raises an error, treat the operation named in the error as a compatibility issue to resolve or document, rather than assuming the framework covered it.

Can a library guarantee bitwise results across GPU architectures?
Only in constrained cases. NVIDIA’s CCCL documentation describes a gpu_to_gpu reproducibility level for supported algorithms and combinations. The guarantee is limited to the operations covered by that implementation and is tied to a fixed CCCL and CUDA Toolkit version; it is not a blanket promise for every model operator.

To rely on such a guarantee, identify every relevant operation in the inference graph, verify that each has the required GPU-to-GPU support, and keep the specified library and toolkit versions fixed. Do not infer cross-architecture equality merely because repeated runs on one GPU are deterministic.
How should I compare model outputs?
Compare numerical outputs when the model exposes them
For logits, embeddings, or other tensors, store the values from each run and calculate a declared error measure. Use the same shape and ordering, and report the maximum and typical differences together with the tolerance. A tolerance is an engineering decision tied to downstream behavior, not a universal constant supplied by the hardware.
Use task-specific checks for generated text
For generation, compare the result that your application actually needs: exact token sequence, structured fields that parse correctly, a classification label, a pass rate on a fixed test set, or a human-reviewed quality threshold. Small logit changes can alter a sampling choice or a later token, so semantic similarity should not be described as bitwise reproducibility.
Keep an audit record
- Checkpoint, tokenizer, and preprocessing hashes.
- GPU name and architecture for each run.
- Operating-system, driver, framework, CUDA, and backend versions.
- Dtype, quantization, batch and sequence shapes, and generation parameters.
- Seed values and the exact acceptance rule.
- Raw outputs or hashes of outputs, plus the comparison results.
What performance trade-offs should I expect?
Deterministic operations are often slower than their unrestricted alternatives. CCCL describes its strongest GPU-to-GPU reproducibility choices as typically the slowest option. The sources do not establish a universal percentage penalty or a typical mismatch rate, so measure your own model with and without the reproducibility constraints.

Benchmark under the same batch size, sequence length, precision, and power or thermal conditions used in production. A faster GPU is not automatically a better choice if it forces an unsupported kernel, a different precision, or a reproducibility level your application cannot accept.
How should I choose GPUs for a reproducible offline deployment?
There is no generally superior GPU for this purpose without a workload-specific test. Evaluate the following dimensions on the exact model:
| Selection criterion | Question to answer |
|---|---|
| Deterministic coverage | Do all required operators and backends have deterministic implementations on every target architecture? |
| Cross-GPU guarantee | Does the selected library explicitly support GPU-to-GPU reproducibility for those operations? |
| Numerical behavior | Can every device run the same dtype, quantization, and accumulation policy within the accepted tolerance? |
| Software support | Can one fixed framework, toolkit, driver, and extension set be installed and maintained offline? |
| Memory capacity | Does each GPU hold the checkpoint, runtime workspace, and intended batch without changing the execution path? |
| Measured performance | What throughput and latency result after deterministic settings are enabled? |
Because no universal hardware specification or winner is established, select from measurements and documented operator support rather than from a product name alone.
What should I troubleshoot when two offline GPUs disagree?
- One GPU changes between repeated runs: check seeds, dropout or training mode, random preprocessing, asynchronous result collection, and nondeterministic-operation warnings.
- Both GPUs are individually repeatable but differ from each other: compare architecture, dtype, attention and convolution backends, toolkit and driver versions, and reduction or accumulation behavior.
- Only generated text differs: compare logits before decoding, then verify sampling settings, tokenization, stopping rules, and whether a small numerical change crosses a token-selection boundary.
- Deterministic mode fails: identify the reported operation, find a supported deterministic implementation, or document that your chosen acceptance level cannot be met with the current stack.
- Offline deployment fails before inference: verify that checkpoint shards, tokenizer data, compiled extensions, shared libraries, and compatible drivers are present locally; this is a packaging problem rather than a numerical one.
What level of consistency should I require?
Use the least restrictive standard that protects the application. Bitwise equality is appropriate when downstream systems hash tensors, compare exact scientific results, or require forensic replay. Numerical tolerance is usually more practical for continuous values. Task-level acceptance is often sufficient for user-facing generation, provided the test set and pass criteria are explicit.
If a contract or safety case requires exact cross-architecture bits, restrict the deployment to operations and fixed software versions with an explicit GPU-to-GPU guarantee. Otherwise, document the measured tolerance or task outcome and treat a change in hardware, backend, or version as a new validation event.

FAQ
Does a fixed random seed make two GPUs give the same answer?
No. A seed can align random-number streams, but it cannot remove differences in floating-point order, kernels, precision, or software implementations. It is one control in a reproducibility plan, not proof of cross-GPU equality.
Is temperature zero enough for identical language-model text?
It removes intentional sampling randomness only when the decoding implementation treats it that way. If two GPUs produce slightly different logits, a tie or near-tie can still lead to different selected tokens, so test the token sequence or the task-level output you actually require.
What should an offline reproducibility report contain?
Include checkpoint and tokenizer hashes, hardware and architecture, driver and toolkit versions, framework and backend settings, dtype, seeds, input set, generation parameters, and the acceptance rule. Preserve representative raw outputs or tensor hashes so another operator can distinguish a packaging change from a numerical change.
Can I claim reproducibility after testing only one GPU?
You can claim repeatability for that tested setup if repeated trials pass your criterion. You cannot extend that claim to another architecture without running the cross-GPU comparison and verifying the relevant operator and library guarantees.
