Manufacturing AI adoption is accelerating, but the evidence does not prove a single global fourfold increase. Surveys show more factories moving from experiments toward production use, while paper forms, spreadsheets, manual data entry and disconnected equipment remain normal. Deloitte’s 2025 survey found 29% of manufacturers using AI or machine learning at facility or network level and 24% using generative AI at that scale; many more were still piloting. At the same time, the National Association of Manufacturers (NAM) reported in 2024 that 70% of manufacturers still collect data manually, and Epicor found that only 17% had fully digital documents.

The apparent contradiction has a practical explanation: AI capability is advancing faster than factories can digitize records, standardize data, connect legacy machines and redesign work. The manufacturers most likely to get value will treat paper elimination and data integration as prerequisites, then apply AI to a bounded problem such as maintenance, inspection, scheduling or inventory accuracy.

Is manufacturing AI really quadrupling?

Not according to a single, globally comparable time series. “Quadrupling” is a useful headline for the speed of experimentation and investment, but it overstates what current surveys can establish. Different studies define adoption differently: one may count an early experiment, while another counts an AI system embedded in a redesigned production process.

McKinsey’s March 2025 global survey illustrates the problem. It found that organizational AI use in at least one business function reached 78% in 2024. Its manufacturing-function figure was 12%, and generative-AI use in manufacturing was 5%. McKinsey says “adopted” can mean anything from early experimentation to AI embedded across redesigned processes, so those percentages cannot be treated as a clean before-and-after measure.

A more accurate description is that manufacturing AI is accelerating from a low base. Investment, pilots and planned production-network deployments are multiplying, but scaled, repeatable use remains less common than the headlines suggest. Deloitte’s 2025 survey, for example, separates production use from pilots instead of combining them into one adoption number.

How many manufacturers are using AI today?

Use is substantial but uneven, with a large gap between pilots and facility-wide deployment. Deloitte surveyed 600 manufacturing executives in 2025. OECD’s 2025 summary of 2024 Eurostat data shows that adoption also varies sharply by subsector and by the specific task an AI system performs.

Measure Reported share How to interpret it
AI or machine learning in use at facility or network level 29% Deloitte survey of 600 manufacturing executives, 2025
Generative AI in use at facility or network level 24% Deloitte, 2025; this is production-scale use, not a claim that every line is automated
AI or machine learning being piloted 23% Deloitte, 2025
Generative AI being piloted 38% Deloitte, 2025; the higher pilot share indicates continued experimentation
AI adoption in pharmaceuticals 26% OECD summary using 2024 European data
AI adoption in electronics 25% OECD summary using 2024 European data
AI adoption in textiles and apparel 6% OECD summary using 2024 European data
AI adoption in food processing 7% OECD summary using 2024 European data
AI adoption in basic metals and wood/paper 9% OECD summary using 2024 European data

The subsector spread is as important as the headline average. Pharmaceuticals and electronics often have more controlled processes and valuable digital records. Food processing, textiles and basic materials may face older equipment, thinner margins, variable inputs or stricter production constraints. OECD notes that legacy infrastructure incompatible with AI may help explain lower adoption in some of these industries.

Why are factories investing in AI while workers still fill out paper forms?

Because an AI pilot can be funded separately from the operational work needed to make all data digital and trustworthy. A model may demonstrate value on a clean, narrow data set while the broader plant still relies on paper checklists, emailed spreadsheets and manual transcription.

Manual collection is still the default in many plants

NAM reported in 2024 that 70% of manufacturers still collect data manually. The same report said 44% had at least doubled the amount of data they collect compared with two years earlier. More measurements without a better collection method increase transcription, reconciliation and delay costs.

Mixed paper and digital records create a broken handoff

Epicor’s 2024 research found 26% of respondents using all-paper documents, 58% using a paper-and-digital mix, and only 17% operating with all-digital documents. A production operator may record a reading on paper, a supervisor may re-enter it into a spreadsheet, and a planner may wait until the next shift for a usable number. An AI service cannot reliably optimize a process when the underlying event is late, incomplete or assigned the wrong identifier.

Document-heavy workflows are especially resistant

SME and Laserfiche reported that only about one-third of manufacturers had completely automated several document-heavy activities, including quality management and inspection sheets. The same work found that 62% reported delays affecting inventory data, throughput time, equipment effectiveness or capacity utilization. Paper is therefore not merely an inconvenience; it is a visible symptom of disconnected workflows.

The causes are organizational as well as technical

  • Legacy machines may lack modern interfaces or consistent timestamps.
  • Different lines may use different names, units, part numbers and defect codes for the same concept.
  • Skilled operators may not have time or training to maintain new systems.
  • Safety, quality and uptime concerns make managers cautious about changing a proven process.
  • Plants may lack a clear AI owner, data governance rules or a cybersecurity design.

Removing paper without fixing these causes can simply move bad information into a new application. Digitization must preserve traceability while making the data usable by people and machines.

Which manufacturing AI use cases deliver value first?

The best first use case is narrow, measurable and supported by data the plant can actually capture. Common candidates are predictive maintenance, visual quality inspection, schedule optimization, inventory accuracy, production alerts and workflow assistance. OECD’s 2024 European data shows why expectations should be realistic: only 2.8% of manufacturing enterprises used AI for production-process optimization, 3.2% for workflow automation or decision assistance, 2.7% for image recognition and 1.5% for autonomous robot decisions.

Use case Data needed Useful measures Typical constraint
Predictive maintenance Machine states, sensor readings, work orders and failure history Unplanned downtime, mean time between failures, maintenance labor Rare failures and inconsistent maintenance codes can make models unreliable
Visual quality inspection Images tied to part numbers, defect labels and inspection outcomes Scrap, false rejects, inspection time, escaped defects Lighting, camera position and changing product variants affect accuracy
Schedule optimization Orders, routings, changeover times, constraints and actual completion times Throughput, on-time delivery, changeover hours, queue time Recommendations fail if the schedule or downtime data is stale
Inventory accuracy Receipts, issues, locations, counts and lot or serial identifiers Stock-outs, emergency purchases, count labor, inventory variance Manual scans and inconsistent identifiers create hidden errors
Production alerts and workflow assistance Real-time events, standard operating procedures and escalation rules Response time, missed checks, labor time, repeat incidents Alerts must be prioritized so operators do not ignore them
Robotics and autonomous decisions Highly consistent sensor, control and safety data Cycle time, utilization, safety incidents Requires the strongest validation, controls and cybersecurity

Start with one line, product family or process step. Define the baseline before enabling the model, and keep a human accountable for decisions that affect safety, quality release or production stoppage.

What should a manufacturer fix before deploying generative AI?

Fix the information flow before asking a language model to generate instructions, summarize events or make recommendations. Deloitte’s 2025 priorities for the next 24 months point to the required foundation: data analytics (40%), advanced production scheduling (35%), execution systems (33%), cloud (29%), AI (29%), industrial IoT (27%) and quality management (28%). Those priorities put data and workflow systems alongside AI rather than treating AI as a stand-alone purchase.

  1. Map the current work. List every paper form, spreadsheet, email attachment and manual re-entry point. Record who creates it, when, what identifier is used and where the information is retyped or delayed.
  2. Digitize and standardize records. Replace the highest-impact forms with controlled digital records. Agree on names, units, part and asset identifiers, defect codes, timestamps and revision rules before training a model.
  3. Connect operational systems. Link machines and sensors with quality, maintenance, scheduling and execution systems. Preserve the original event and its timestamp so an analyst can trace an alert back to the source.
  4. Choose one bounded use case. Select predictive maintenance, inspection, scheduling, inventory accuracy or another problem with an owner, a baseline and a defined decision. Avoid a vague “AI transformation” pilot.
  5. Set governance before scale. Assign data owners, access controls, retention rules, cybersecurity responsibilities and human-review points. Test how the system behaves when data is missing, delayed or outside normal operating conditions.
  6. Measure and expand only after repeatable value. Track throughput, downtime, scrap, quality, labor time and user adoption across enough operating cycles to expose variation. Expand to another line or site only when the result survives normal production conditions.

This sequence is practical guidance synthesized from the survey evidence. It is not a claim that one source prescribes a universal six-step program; each plant should adapt the order to its safety, regulatory and production constraints.

How can a small or midsize factory start without replacing every legacy system?

Use an incremental architecture that captures reliable events at the point of work and adds connections around existing equipment. A plant does not need to replace every machine or install a network-wide AI platform before proving value.

Starting scope Best fit Trade-off to plan for
Single process or line First pilot with a clear baseline and limited integration Value may not transfer automatically to other lines
Plant-wide workflow Paper elimination, quality records, maintenance requests or inventory transactions Requires common identifiers, user training and role-based access
Production network Multi-site scheduling, benchmarking and shared models Highest integration, cybersecurity and governance effort

When a machine has no modern interface, begin with a controlled digital entry or a suitable sensor rather than guessing values. Keep the old system as the system of record until the new data is reconciled, then retire duplicate entry only after operators and auditors can follow the new trail. Choose tools by deployment scope, integration effort, time to measurable value, operating cost, skills required, cybersecurity, legacy compatibility and worker adoption—not by the novelty of the AI label.

Why do so many AI pilots fail to scale?

The difficult step is changing the operating system of the factory, not demonstrating that a model can work once. BCG and the World Economic Forum reported in 2024 that 68% of companies had started implementing AI, but only 16% had achieved AI-related targets; 98% faced scaling challenges.

The same work identified foundational barriers: 88% cited AI infrastructure gaps and 92% cited people or organizational-foundation gaps. A pilot can use a specialist team and a carefully prepared data set. Production requires reliable interfaces, support at every shift, security controls, procurement approval, maintenance of the model and a workforce that trusts the recommendation.

Scale also exposes economic differences. A model that saves minutes on one line may not cover integration and support costs across a small plant. Conversely, a modest reduction in unplanned downtime or scrap can be valuable when it repeats every shift. Make the business case with the plant’s own baseline rather than a generic industry percentage.

How should a factory measure whether an AI project works?

Measure operational outcomes and adoption together. A technically accurate model is not a successful production system if operators ignore its alerts or if the data arrives too late to change a decision.

  • Baseline: capture several normal production cycles before deployment, including downtime, throughput, scrap, quality, labor time and schedule performance.
  • Decision latency: measure how long it takes for an event to become a usable recommendation and how long a person takes to act.
  • Data completeness: monitor missing fields, duplicate records, timestamp errors and manual corrections.
  • Human adoption: track who uses the workflow, which alerts are accepted or overridden and why.
  • Durability: test the result across shifts, product variants, maintenance periods and abnormal conditions.
  • Economic value: compare verified gains with software, integration, training, sensor, support and change-management costs.

Grace Nam, strategic solutions manager for manufacturing at Laserfiche, summarized the operational stakes: “Overall equipment effectiveness and throughput determine a manufacturing facility’s ability to compete in today’s market.” AI matters when it improves those measures, not when it merely adds another dashboard.

Frequently Asked Questions

Do manufacturers need to move all data to the cloud before using AI?

No. A plant can keep latency-sensitive control and safety functions locally while sending selected, governed data to cloud analytics. The important requirement is a consistent data model, secure interfaces and clear ownership, not one mandatory hosting location.

Can older machines be connected without replacing them?

Often, yes. Plants can use available machine interfaces, edge gateways or purpose-built sensors to capture a limited set of states and measurements. The connection should be validated against the machine’s existing records before it is used for maintenance or quality decisions.

How long should a manufacturing AI pilot run?

Run it long enough to include normal variation such as multiple shifts, product changes and planned maintenance; a fixed calendar duration is less useful than a defined number of representative production cycles. Stop or redesign the pilot if data quality, user adoption or decision timing prevents a fair comparison with the baseline.

Who should own an AI system after the pilot team leaves?

Ownership should be shared by an operations leader and a technical or data owner, with named quality, cybersecurity and maintenance responsibilities. The operating team needs a documented process for model updates, exceptions, access changes and retirement.
