Low GPU utilization is a symptom, not a diagnosis. The useful question is whether the GPUs are waiting for data, moving data through memory or an interconnect, throttling because of heat, or genuinely short of compute. Start with continuous DCGM telemetry, correlate it with CPU, storage, data-loader and network measurements, then validate multi-node suspicions with NCCL benchmarks. This workflow separates compute, GPU-memory, PCIe, NVLink and network bottlenecks without relying on a single percentage. It also catches a slow node, broken peer-to-peer path, missing GPU Direct support, thermal throttling or an NVIDIA Xid error before you change model code.
What does low GPU utilization actually mean?
GPU utilization is the fraction of a sampling interval in which the device was active; it does not say which engine was active or why the device was idle. A workload can show low utilization while waiting on a CPU data loader, host memory, storage, PCIe, NVLink or a network collective. Conversely, high utilization can coexist with poor performance if the kernels are inefficient or the device is thermally throttled.
Google Cloud’s DCGM documentation illustrates a sample value of 0.324 as “(0.324 x 100) 32.4% utilization.” Treat that percentage as an interval average, not as a timeline of individual kernels. NVIDIA’s DCGM profiling documentation explicitly describes profiling values as interval averages rather than a kernel trace, so use them to compare phases such as input, forward, backward and checkpointing.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
For every observation, pair utilization with SM and tensor-pipe activity, memory-copy activity, framebuffer memory, PCIe and NVLink traffic, temperature, clocks, power and error counters. The combination tells you whether the GPU is doing useful arithmetic, moving data, waiting for another component or being held back by hardware health.

How do I establish a trustworthy baseline?
Capture a time series before changing the application. A single snapshot can miss a short input stall or a periodic all-reduce; a baseline lets you compare the same workload phases after each fix.
1. Collect DCGM metrics continuously
Use DCGM or DCGM Exporter to record, at a consistent interval:
- GPU utilization, SM activity and tensor-pipe activity.
- Framebuffer memory used, free and total.
- Memory-copy activity.
- PCIe receive and transmit traffic.
- NVLink receive and transmit traffic.
- Temperature, clock rates and power.
- NVIDIA Xid and other health errors.
DCGM is intended for continuous, relatively low-overhead telemetry in data-center and cluster environments. Exporter output is useful for dashboards and alerts, while direct DCGM queries are useful during an incident. Keep the sampling interval and workload phase labels with the data; changing either can make two runs look different even when the application is unchanged.
2. Mark workload phases
Annotate the timeline with warm-up, data loading, forward pass, backward pass, optimizer step, evaluation, checkpointing and validation. Compare averages inside each phase instead of averaging an entire training run. For example, a low average may hide high compute during forward and backward passes plus long idle gaps while batches are prepared.
3. Save a configuration snapshot
Record GPU model and count, driver and CUDA/NCCL versions, node names, topology, container image, batch size, precision, data location and whether the run is single-node or multi-node. These details make a later comparison meaningful and help explain why a topology or transport path changed.
How should GPU metrics be correlated with the rest of the host?
Low GPU activity is only actionable when it is aligned with host and cluster telemetry. Capture CPU utilization by core, system load, host-memory use and pressure, storage latency and throughput, data-loader queue depth, filesystem or object-store timings, and network throughput and errors. Match timestamps across nodes so a collective stall is not mistaken for a local input problem.
CPU or data-loader starvation
When GPU, SM and tensor activity drop while CPU cores are saturated, data-loader queues empty, or storage latency rises, the GPU is waiting for the next batch. Check preprocessing, worker count, pinned-memory behavior, file open latency, decompression and augmentation. If host memory is under pressure, paging or reclaim can create periodic gaps that look like random GPU idleness.

Host-memory and transfer pressure
A full or rapidly changing framebuffer does not prove that computation is the bottleneck. Observe memory-copy activity and the direction of transfers. Repeated host-to-device copies, synchronization after every batch or an oversized staging buffer can consume bandwidth while SM activity remains modest.
Network or collective waiting
In distributed training, one rank can wait while others appear idle. Compare per-rank progress and network counters, not just the aggregate GPU graph. A collective that starts late on one node can make every other rank look underutilized.
Am I compute-bound, memory-bound, or interconnect-bound?
Classify the bottleneck from combinations of signals, then test the hypothesis with a targeted benchmark. The following patterns are diagnostic clues rather than hard thresholds.
| Observed pattern | Likely bottleneck | Next verification |
|---|---|---|
| High GPU, SM or tensor-pipe activity; framebuffer headroom; no saturated link | Compute-bound | Profile kernels and arithmetic efficiency with Nsight Systems or Nsight Compute. |
| High memory-copy activity or memory pressure with comparatively low compute activity | GPU-memory or memory-transfer-bound | Inspect transfer volume, allocation behavior, batch staging and synchronization. |
| PCIe receive/transmit traffic near available bus capacity while compute remains low | PCIe-bound | Check link generation and width, peer paths, host transfers and topology. |
| NVLink traffic near available link bandwidth while compute remains low | NVLink-bound | Check tensor-parallel or peer traffic, link health and GPU placement. |
| Slow collectives, uneven rank progress or NCCL transport/topology warnings | Network/NCCL-bound | Run subset collective tests and inspect NCCL initialization, network and graph logs. |
What does a compute-bound run look like?
SM or tensor-pipe activity stays high during the important phases, memory-copy activity is not dominant, and PCIe, NVLink and network counters have headroom. In this case, a lower utilization number may simply reflect deliberate synchronization or short kernels. Nsight Compute can identify an arithmetic, occupancy or instruction-level limit; Nsight Systems can show whether the limitation is actually outside the GPU.
How do I recognize a GPU-memory or transfer bottleneck?
Google’s guidance identifies high memory-copy utilization combined with low compute utilization as a memory-transfer warning. Distinguish capacity from bandwidth: framebuffer usage near its limit can trigger allocation pressure or smaller batches, while high copy activity with free capacity indicates movement, not lack of space. Examine whether transfers are repeated, whether tensors are copied between host and device unnecessarily, and whether synchronization prevents overlap.
When is PCIe the bottleneck?
PCIe is a suspect when receive and transmit counters approach the usable bus capacity while SM and tensor activity remain low. Verify the negotiated link width and generation, which devices share a root complex, whether peer-to-peer traffic is taking a host route, and whether a workload is moving batches or gradients across the bus more often than expected. A PCIe-bound run can look like a CPU-starved run unless you inspect the link counters.
When is NVLink the bottleneck?
Near-saturated NVLink traffic with low compute activity points to an inter-GPU communication limit. Check GPU placement and the topology used by the parallelism strategy. A tensor- or pipeline-parallel job can be sensitive to which GPUs share direct links; changing rank placement may help only after you verify that the links, rather than the kernels or host path, are limiting progress.

How do I test whether NCCL or the network is slowing a multi-node job?
Use a collective benchmark outside the training application, then narrow the test to node subsets. This separates a transport or topology problem from model and data-loader behavior.
Quick wins for a faster PC:
Scan for outdated or missing drivers - takes under a minuteDriver Scan →Repair Windows errors before they cause bigger problemsFix Now →Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →1. Run a collective benchmark
Run all_reduce_perf from the NCCL test suite, or an equivalent all-reduce benchmark, with the same GPU count and node arrangement as the job. Compare achieved collective performance and rank completion times across repeated runs. Keep the process placement and network interface selection consistent so the comparison is meaningful.
2. Test node subsets
Repeat the benchmark with different pairs or groups of nodes. If a full-cluster test is slow but most subsets are normal, the intersection of the slow subsets identifies a suspect node or link. Count opCount entries in NCCL logs and compare progress by rank; a rank that stops advancing can hold the entire collective behind it.
3. Turn on focused NCCL logging
For a deeper run, capture initialization, network, environment, collective and topology messages:
NCCL_DEBUG=INFO
NCCL_DEBUG_SUBSYS=INIT,NET,ENV,COLL,GRAPH
Use the logs to confirm which transport and network path were selected, whether the expected topology was discovered and where ranks diverge. Keep the logs from every rank and label them with the node name; a single aggregate log can hide the straggler.
4. Verify GPU Direct and peer-to-peer prerequisites
Multi-node performance depends on more than application collectives. Check that GPU Direct RDMA is available, that peer-to-peer access is enabled, and that the required nvidia-peermem or DMA-BUF path is present for the driver and kernel combination. Review IOMMU and ACS behavior, because they can redirect or restrict peer traffic. In containers, confirm that the relevant /sys topology information is visible; an incomplete view can cause NCCL to choose a slower path.
5. Check shared memory before treating initialization as a network failure
NCCL requires shared memory for parts of its initialization and operation. NVIDIA documents that insufficient shared memory causes NCCL initialization to fail. In a container, inspect the size and mount of /dev/shm, container limits and host memory pressure before changing network settings. An initialization error is not evidence that the fabric is slow.

How do I find the slow or faulty node?
Distributed jobs proceed at the pace of their slowest required rank. Isolate the node with per-rank telemetry and controlled subset tests rather than tuning every worker at once.
- Give each rank a stable node and GPU identifier in its log output.
- Run the same NCCL collective repeatedly on the full set and on node subsets.
- Compare
opCountprogression, collective durations and transport messages by rank. - On the suspect node, compare DCGM memory, link traffic, temperature, clocks, power and Xid counters with a healthy peer.
- Drain or replace the node for one controlled run. If the collective returns to normal, preserve its logs and hardware diagnostics for repair.
A node can be slow without reporting a fatal error: a degraded link, incorrect topology visibility, thermal slowdown or a driver path that falls back to host memory may only appear as longer collectives and uneven progress.
Could heat, clocks, or hardware errors be causing the slowdown?
Yes. Thermal and hardware conditions can mimic an application bottleneck, so check them before changing batch size or parallelism.
Check temperature and clock throttling
Use nvidia-smi to query temperature, clocks and the clocks_throttle_reasons.hw_slowdown field. Google Cloud documents that sustained temperatures above 87 °C under load on A3 systems can cause performance degradation. This is a platform-specific operating condition, not a universal limit for every GPU or chassis. Correlate the temperature rise with clock drops and workload phases.
Run a DCGM diagnostic
Run the first DCGM diagnostic level:
dcgmi diag -r 1
Record the result, GPU identity and timestamp. A diagnostic pass does not replace application profiling, but it can expose a node that should not be used for a comparison run.
Inspect kernel logs for Xid errors
Search dmesg or /var/log/kern.log for NVIDIA Xid codes around the slowdown. Preserve the complete message and time, because the code and surrounding driver messages determine the next hardware or software action. Repeated Xids on one device warrant node isolation and platform support involvement rather than model-level tuning.

What fixes match each bottleneck?
For CPU, storage, or data-loader starvation
- Measure queue depth and batch-ready time before increasing worker counts.
- Reduce expensive preprocessing or move it to an appropriate stage.
- Resolve storage latency, metadata hot spots and host-memory pressure.
- Confirm that pinned-memory and asynchronous copies are actually overlapping with compute.
Do not add workers blindly: oversubscription can increase context switching and memory pressure while leaving the GPU idle.
For GPU-memory capacity or transfer pressure
- Identify tensors that are copied repeatedly or retained longer than necessary.
- Reduce redundant host-device synchronization and permit safe overlap.
- Adjust batch size, activation retention or checkpointing only after confirming capacity pressure.
- Check that precision and memory layouts match the kernels used by the workload.
For PCIe or NVLink limits
- Map the physical and logical topology and place communicating ranks on the fastest available links.
- Confirm peer-to-peer access instead of an unintended host staging path.
- Reduce unnecessary transfers and combine small messages where the framework supports it.
- Re-run link counters and collective tests after placement changes.
For NCCL or network problems
- Fix missing GPU Direct RDMA, peer-memory or DMA-BUF prerequisites.
- Correct IOMMU or ACS settings that force a slower route, following the platform’s supported configuration.
- Expose the required topology information inside containers.
- Use subset tests to remove a faulty node or link from the job while it is investigated.
For thermal or hardware faults
- Improve cooling, airflow or workload scheduling when sustained temperature is the trigger.
- Remove a node with repeated Xid errors or failed diagnostics from the comparison pool.
- Do not compare a throttled node with healthy nodes when judging an application change.
What are the most common troubleshooting mistakes?
- Optimizing from GPU utilization alone: a percentage cannot distinguish compute, memory movement or waiting.
- Reading DCGM as a kernel trace: interval averages hide short stalls and phase transitions.
- Changing several layers at once: model, topology, driver and container changes make the result impossible to attribute.
- Testing only the full cluster: a subset benchmark is often what reveals the slow node.
- Ignoring container topology: missing
/sysvisibility can alter NCCL’s transport choice. - Assuming an initialization error is a fabric failure: insufficient shared memory can prevent NCCL from initializing.
- Skipping health checks: throttling and Xid errors can look exactly like software inefficiency.
What is the fastest practical workflow?
- Capture a DCGM baseline with engine, memory, link, thermal, clock, power and error metrics.
- Mark workload phases and correlate them with CPU, host memory, storage, data-loader and network telemetry.
- Classify the pattern as compute, GPU-memory, PCIe, NVLink or network/NCCL bound.
- Run NCCL collective tests on the full cluster and selected node subsets when communication is suspected.
- Inspect P2P, GPU Direct RDMA, peer-memory or DMA-BUF, IOMMU/ACS and container
/sysvisibility. - Check temperature,
clocks_throttle_reasons.hw_slowdown,dcgmi diag -r 1and kernel Xid logs. - Apply one targeted change, repeat the same measurement and retain the before-and-after evidence.
- Use Nsight Systems or Nsight Compute only when telemetry has narrowed the question to system or kernel attribution.
Frequently Asked Questions
Does 100% GPU utilization prove that a training job is healthy?
No. A GPU can be fully occupied by inefficient memory traffic, synchronization or a throttled clock state. Check tensor-pipe activity, memory-copy counters, clocks, temperature, power and step time before calling the run healthy.
The Tool Desk
Outbyte Driver Updater FREEScan for outdated or missing drivers - takes under a minuteDriver Scan →Outbyte PC Repair FREEClear out junk files and repair common Windows errorsFree Scan →How can I tell a slow data loader from a slow network collective?
A data-loader problem repeats before batches reach the GPU and correlates with CPU, storage or queue delays on one host. A collective problem appears at synchronization points, produces uneven rank progress and is reproducible with an isolated NCCL all-reduce test.
Why can NCCL fail inside a container even when the network works?
NCCL also depends on shared memory and topology visibility. An undersized or incorrectly mounted /dev/shm, hidden /sys data, or unavailable peer-memory path can stop initialization or force an unsuitable transport before network throughput is measured.
Should I deploy DCGM Exporter on every Kubernetes node?
Use it when you need comparable, persistent GPU metrics across the cluster and want to correlate them with pod and node telemetry. Ensure the deployment has the permissions and device visibility required by your platform, and keep direct DCGM or diagnostic access available for incident-level checks.
Which profiler should I open first for an unexplained slowdown?
Start with DCGM and host telemetry to decide whether the issue is compute, transfer, interconnect, thermal or hardware-related. Choose Nsight Systems for cross-component timelines and Nsight Compute only after a particular GPU kernel has become the leading suspect.
