Evaluate an AI system as an end-to-end service, not as a model score. Define the decision it must support, test it on realistic and documented data, measure task quality alongside cost and speed, exercise failure modes, and keep monitoring after launch. The right result is a use-case scorecard with acceptance thresholds, uncertainty ranges, segment results, and evidence from model tests, system tests, red-team exercises, and users. A model can score highly on a benchmark yet fail when retrieval, prompts, tools, post-processing, queues, or human handoffs are added. This guide shows how to measure the four dimensions consistently and decide whether a system is fit for a specific workload.
What does it mean to evaluate an AI system?
An evaluation asks whether the complete system performs its intended task, at an acceptable risk and operating cost, under the conditions in which people will use it. Accuracy answers only one part of that question. A useful evaluation also records latency distributions, throughput, failures, timeouts, cost per successful outcome, robustness to changing inputs, and the behavior of fallbacks or abstentions.
Write the intended use in operational terms before collecting scores. State the user, decision, input and output, acceptable failure modes, risk tolerance, expected volume, geography, and deployment environment. NIST evaluation guidance starts with objectives and intended use because a metric has no meaning without a decision it is meant to inform.

How do I define the use case and acceptance criteria?
Turn a broad goal such as “answer support questions” into a testable contract. The contract should identify what counts as success, which errors are severe, and what operating limits cannot be exceeded.

Describe the decision and users
- Name the person or downstream service that consumes the output.
- Specify whether the output informs, recommends, ranks, automates, or merely drafts a decision.
- List the information the system may access, the tools it may call, and when it must abstain or hand off.
- Record regions, languages, business hours, device types, and network conditions that affect operation.
Set thresholds before testing
Define minimum task quality, maximum severe-error rate, latency limits, budget per completed task, and allowable timeout or dependency-failure rates. Set stricter thresholds where an error can cause material harm, and document who can approve an exception. Keep thresholds separate by production segment when the consequences or workload differ.
Choose a baseline
Compare with a human reference, an existing workflow, a simpler model, or a rules-based system where practical. A baseline reveals whether added complexity buys enough quality or speed to justify its cost; it also prevents a high benchmark score from being mistaken for business value.
How do I build a representative AI test set?
Use a frozen, versioned set that resembles production rather than a convenient sample. NIST recommends clearly defined, realistic test sets and documented methodology.
Include the cases that change the decision
- Typical cases: the common inputs that dominate volume.
- Edge and difficult cases: ambiguous requests, long context, missing fields, rare classes, and conflicting instructions.
- Production segments: languages, regions, customer tiers, channels, device types, and traffic sources expected after launch.
- Out-of-distribution and adversarial cases: malformed inputs, prompt injection attempts, unusual formatting, and requests outside the system’s scope.
Document provenance and labels
For every item, store its source, inclusion rule, label definition, annotator instructions, and dataset version. Keep training, tuning, and evaluation data separated to reduce leakage. Record missing labels, disputed labels, and cases where the correct action is to abstain; deleting those cases can make quality look better than it is.
Freeze the conditions
Save the exact prompt, model version, retrieval index, tool schemas, output limits, safety settings, hardware or region, concurrency, and retry policy used for the run. Without a frozen configuration, a later comparison cannot tell whether a score changed because of the model or because the surrounding system changed.
Which accuracy and quality metrics should I use?
Choose metrics that match the task, and select them before running the test. No single metric captures every useful behavior.
| Task type | Useful measures | What to inspect beyond the headline score |
|---|---|---|
| Classification | Accuracy, precision, recall, F1, ROC-AUC, calibration | Confusion matrix, class imbalance, severe-class recall, threshold trade-offs, and confidence reliability |
| Ranking or retrieval | Recall@k, precision@k, mean reciprocal rank (MRR), nDCG | Relevant-item coverage, ordering of critical results, duplicate results, and performance by query segment |
| Text or multimodal generation | Human rubric scores, factuality, relevance, completeness, task success | Unsupported claims, instruction following, refusal or abstention quality, and evaluator agreement |
| Code generation | Compilation, unit-test pass rate, security checks, task completion | Runtime failures, unsafe dependencies, maintainability, and behavior on hidden tests |
| Retrieval-augmented generation | Retrieval recall and precision, answer correctness, citation or evidence support | Whether the answer is grounded in retrieved material and what happens when evidence is absent |
Microsoft’s evaluation guidance groups reference-based, reference-free, LLM-based, prompt-based, code, and retrieval-augmented metrics. Use automated metrics for scale, then sample outputs for human review. Define a rubric with observable criteria, train evaluators on examples, and report agreement; disagreement often identifies an unclear task definition rather than a model defect.

How can I measure accuracy in a way that predicts real use?
Run the complete task path and report results by segment, not only an overall average. For a support assistant, for example, score whether the customer received a correct resolution, not merely whether the generated paragraph resembled a reference answer.
Measure task success and severe errors
Count an outcome as successful only when it satisfies the acceptance definition. Track a separate severe-error rate for mistakes that could trigger an unsafe action, expose confidential information, or send a user down the wrong workflow. A system with high average quality but unacceptable severe errors is not fit for that use.
Evaluate calibration and abstention
When the system emits confidence, compare confidence with observed correctness. Inspect whether low-confidence cases are routed to a person or a fallback, and whether abstention is concentrated in difficult segments. An abstention that safely avoids a bad decision can be preferable to a confident but incorrect answer, so include both behaviors in the scorecard.
Test end-to-end outputs
Include preprocessing, retrieval, prompt assembly, model calls, parsing, post-processing, storage, and human handoffs. A benchmark score can improve while a parser drops fields or a retrieval change removes the evidence needed for a correct answer.
How do I calculate AI cost per request and per successful task?
Measure cost at the level of the outcome the business buys. Record provider or infrastructure charges, retrieval and storage costs, moderation or tool calls, human review, and the cost of retries. Report both cost per request and cost per completed or successful task.
Useful calculations are:
cost per request = total evaluation cost / completed requestscost per successful task = total evaluation cost / successful taskssuccess-adjusted cost = cost per request / task-success rate
The last measure rises when failures, retries, or human escalations consume resources. Keep one-time setup or evaluation expenses separate from recurring serving costs, and state the billing region, plan, currency, and measurement period. If a request can fan out to several model calls, count each call and its tokens or compute usage rather than pricing only the top-level API request.
What latency should I report?
Report a distribution, not one average. The Singapore Responsible AI Playbook specifically calls for latency at p50, p90, and p95: p50 describes the typical request, while p90 and p95 expose the slower experiences that affect service-level objectives.

| Measure | Definition | Why it matters |
|---|---|---|
| p50 | Half of requests finish at or below this time | Typical interactive experience |
| p90 | Nine out of ten requests finish at or below this time | Frequent slow-tail behavior |
| p95 | Ninety-five percent finish at or below this time | Service-level and user-experience planning |
| Throughput | Completed requests or tasks per unit of time under stated concurrency | Capacity and queueing decisions |
Measure from the user’s request to the final usable result, then add component timings for queue wait, preprocessing, retrieval, each model call, tool execution, post-processing, and handoff. Record the concurrency, input and output sizes, hardware or region, streaming behavior, timeout limit, and retry policy. A low model time can still produce a slow user experience if retrieval or queueing dominates.

Repair common Windows errors and clear accumulated junk for a smoother, more stable PC - no reinstall needed.Free scan · no reinstallHow do I test reliability and robustness?
Reliability is conditional and time-based: NIST defines it as the ability of an item to perform as required, without failure, for a given time interval and under given conditions. Robustness is maintaining performance when those circumstances change. State the conditions for every claim.
Repeat normal operation
Run the same cases across different times and seeds where applicable. Track task failures, error responses, malformed outputs, timeouts, and retries. Repeat under expected concurrency and at a higher load to expose queue saturation and rate limits.
Inject failures
- Disable or delay retrieval, tool, authentication, storage, and network dependencies.
- Force model timeouts, provider errors, truncated responses, and invalid structured output.
- Verify that fallbacks, retries, circuit breakers, and human handoffs activate once and recover without duplicate side effects.
Probe changed inputs
Perturb formatting, spelling, context length, language, units, and ordering. Add adversarial and out-of-distribution cases. Compare quality, abstention, latency, and cost with the clean test set; robustness is not demonstrated by accuracy on one static sample.
Why must I evaluate the whole system instead of only the model?
Users experience a pipeline. Preprocessing can remove information, retrieval can return irrelevant evidence, prompts can alter instructions, post-processing can corrupt a valid answer, and a handoff can fail even when the model output is correct. End-to-end tests reveal these interactions.
Recommended Free Tools
Keep component tests for diagnosis, but make the final acceptance decision on realistic scenarios that exercise the complete path. Include storage, permissions, rate limits, observability, fallback behavior, and any human review queue. A model benchmark is evidence about one component; it does not automatically generalize to related tasks or production workflows.
How should I compare two AI systems fairly?
Use the same frozen test set and operating conditions, then show trade-offs rather than collapsing everything into one score.

Plot a Pareto view: a system is preferable when no alternative is both cheaper and better on every binding requirement. Explain which metric controls the decision. For example, a slightly more expensive system may be the only one below the severe-error threshold, while a cheaper system may win for low-risk drafting.
What is a practical evaluation workflow?
Use this sequence for a new system or a material change to an existing one.
- Define the decision and conditions. Record users, task, risk tolerance, workload, geography, dependencies, and acceptable failures.
- Build and version the test set. Include normal, difficult, edge, segment, adversarial, and out-of-distribution cases; document provenance and labels.
- Select metrics and rubrics. Choose task-quality, severe-error, calibration, abstention, latency, throughput, cost, error, and timeout measures before testing.
- Freeze the configuration. Save model and index versions, prompts, tools, hardware or region, concurrency, output limits, and retry policy.
- Run component checks. Test preprocessing, retrieval, model calls, parsers, safety controls, storage, and handoffs independently.
- Run scenario and end-to-end tests. Measure the complete user path under normal and stressed conditions.
- Exercise failures and attacks. Perturb inputs, overload dependencies, induce timeouts, and verify recovery, abstention, and escalation.
- Analyze uncertainty and segments. Report sample sizes, confidence intervals or other uncertainty ranges, missing data, evaluator agreement, and root causes.
- Decide and document. Compare results with the pre-set thresholds, record remediation owners, and state the conditions under which approval applies.
How should I report uncertainty and segment results?
Every rate needs context: sample size, test period, data version, and the population or segment represented. Provide confidence intervals or other uncertainty ranges when a decision depends on a small difference. Do not treat a one-point change as meaningful if the intervals overlap substantially or the sample is too small.
Break out results for important languages, regions, input types, customer groups, and risk classes. Show missing labels, abstentions, evaluator disagreement, and excluded cases. For each failure, record the root cause, severity, affected component, and remediation action; this turns a score into an improvement plan.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. What should I monitor after launch?
Pre-launch tests are a baseline, not a permanent guarantee. Log quality proxies and sampled outcomes, p50/p90/p95 latency, throughput, cost, errors, timeouts, retries, drift indicators, user feedback, overrides, abstentions, and incidents. Keep the same metric definitions used in acceptance testing so production trends remain comparable.
Set alerts for threshold breaches and investigate changes by segment. Re-evaluate when the model, prompt, retrieval index, tool, traffic mix, dependency, or deployment region changes. NIST recommends documented metrics and tools, demonstrated validity and reliability, and regular monitoring for emergent risks. Feed confirmed production failures back into a versioned regression set, then rerun the workflow before releasing a fix.
What commonly goes wrong, and how can I fix it?
| Failure pattern | Why it misleads | Correction |
|---|---|---|
| Optimizing one benchmark score | The benchmark may not represent the production decision or pipeline | Add realistic scenarios, segment analysis, and end-to-end acceptance tests |
| Using average latency | Averages hide slow-tail requests and queue saturation | Report p50, p90, p95, throughput, and component timings |
| Pricing only model calls | Retries, tools, retrieval, storage, and human review alter economics | Calculate cost per request and per successful task from full traces |
| Removing hard examples | Quality appears higher when abstentions, missing labels, or edge cases disappear | Keep them, label them, and report missingness and abstention behavior |
| Changing test conditions between systems | Prompt, hardware, concurrency, or retry differences confound the result | Freeze and reuse the same configuration controls |
| Stopping at launch | Data drift, dependency changes, and new failure modes emerge over time | Monitor continuously and maintain a regression set |
Which evaluation modes provide trustworthy evidence?
Use more than one mode. NIST’s ARIA approach combines model testing, red teaming, and user testing, while the TEVV-Athlon framework organizes customized events and tools around measurement objectives. Model tests quantify repeatable behavior; red teams search for harmful or unexpected failures; user tests reveal whether people can complete the intended task and recover when the system abstains or fails.

Converging evidence is stronger than any single score. When modes disagree, inspect the task definition, test conditions, and failure traces instead of averaging the numbers away.
What should an evaluation scorecard contain?
A concise scorecard should let a decision-maker see fitness, trade-offs, and limits without opening raw logs.
- Use case, intended users, risk class, workload, geography, and test-set version.
- Task success and quality by segment, plus severe-error rate.
- Calibration, abstention, evaluator agreement, and uncertainty ranges.
- p50, p90, and p95 latency; throughput; error and timeout rates.
- Cost per request and cost per successful task, including retries and handoffs.
- Robustness results under perturbation, load, dependency failure, and adversarial input.
- Known limitations, root causes, remediation actions, owners, and re-test date.
Frequently Asked Questions
How large should an AI evaluation test set be?
There is no universal count. Size it so the important segments and severe-error classes have enough observations for a decision-useful uncertainty range; rare but high-consequence cases may require targeted sampling rather than relying on their natural frequency.
Quick wins for a faster PC:
Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Repair Windows errors before they cause bigger problemsFix Now →Should human reviewers see model outputs in random order?
Yes, randomization or blinding reduces order and expectation effects when reviewers compare systems. Give every reviewer the same rubric and calibration examples, then report agreement and adjudication rules alongside the scores.
When should an AI system be re-evaluated?
Repeat the evaluation after any change that can alter behavior or operations, including model, prompt, retrieval index, tool, parser, dependency, traffic mix, or region. Also schedule periodic reviews so drift and newly observed incidents are not missed.
How do I evaluate a system that can refuse or escalate?
Treat refusal, abstention, and escalation as explicit outcomes with their own quality, latency, cost, and user-impact measures. Check that difficult or unsafe cases are routed appropriately and that the fallback completes the task without duplicate actions or silent loss of context.
Is a higher-accuracy system always the better choice?
No. A small quality gain may come with unacceptable p95 latency, cost, severe errors, or operational complexity. Choose the system that meets every binding threshold and offers the best trade-off for the stated use case.
