Evaluate an AI model for fairness by testing it in the context where it will actually be used—not by relying on one aggregate accuracy score. Define who could be affected and what harm matters, check data and test-set representativeness, measure performance across relevant groups, probe for harmful outputs, and have qualified people review the results. Then document the limits and mitigations, and continue monitoring after deployment.
The right test depends on the model’s task, users, language, location, and consequences of error. This guide turns that principle into a repeatable workflow for assessing models, including generative systems, and for comparing two models on equal terms.
What does a fairness evaluation actually evaluate?
A fairness evaluation examines how an AI system’s behavior and consequences vary for people in its intended setting. The system includes more than the model: data collection, labels, prompts, interface, human review, decision rules, and deployment context can all shape who benefits and who bears the risk.

Fairness is not a single property that can be certified with one score. It is a set of questions about a particular use, population, and kind of harm.

NIST’s AI Risk Management Framework describes trustworthy AI characteristics as including being fair with harmful bias managed. It treats trustworthiness as relevant across pre-design, design, development, deployment, use, and test and evaluation—not as a final check immediately before release. ISO/IEC TR 24027:2021 likewise addresses bias across data collection, training, design, testing, evaluation, continual learning, and use.
UNESCO’s 2021 Recommendation on the Ethics of Artificial Intelligence calls for fairness and non-discrimination and for action against stereotyping in AI outcomes and training data. The recommendation applies to all 194 UNESCO Member States. These frameworks offer principles and lifecycle guidance; they do not supply one universal pass/fail score for every model.
How should I scope a bias test before choosing metrics?
Start by writing down the decision the model supports and the people affected by it. Only after that should you select data, metrics, and prompts: a measurement that is meaningful for one task may conceal the most important harm in another.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsDescribe the use and the stakes
Record the intended task, where the system will be used, who will use it, and what happens when it is wrong. Include geography, languages, accessibility needs, decision stakes, human-in-the-loop steps, and foreseeable misuse. A tool that suggests content for a person to review has a different risk profile from one whose output directly affects access to a service.
Be specific about the affected population. “Users” is rarely a sufficient description: relevant groups may differ by age, race, ethnicity, gender, disability, region, language, or other characteristics. Consider intersections where the combination of characteristics could change the experience—for example, a language and disability combination that is not represented by testing each characteristic separately.
Turn broad concerns into observable harms
Translate a concern such as “the system should be fair” into outcomes you can inspect. Depending on the task, those may include missed eligible cases, false accusations, unequal access, lower-quality service, differential refusal, privacy exposure, or generated text that assigns people unfair traits or roles. Define severity as well as frequency: a rare but consequential failure may deserve more attention than a common, low-impact one.
List foreseeable misuse as well as intended use. OECD guidance recommends considering the use case, users, inputs, human involvement, geographic and socio-economic context, scientific validity, and reasonably foreseeable misuse. For each risk, state who could be harmed, how the harm could arise, and what evidence would indicate that it is happening.
Set the evaluation boundary
Specify which model, version, interface, and deployment configuration you are evaluating. For a generative system, the tested behavior can depend on prompts, context, sampling settings, and policy or API changes. For a decision system, it can depend on thresholds and the human process around the prediction. Record these boundaries so a result is not mistaken for a property of every version or use.
How do I audit the data behind a model?
Ask how the data was collected, who it represents, how labels were assigned, and what is missing. Data problems can enter during collection, sampling, labeling, preprocessing, or later changes to the population served.
Request evidence, not just a dataset description
For training and evaluation data, seek the collection method, sampling frame, labeling process, missingness, demographic coverage, known exclusions, and the legal basis or consent conditions for use. Establish whether the data resembles the population and conditions in the intended setting. A large dataset is not automatically representative, and a category appearing in a dataset does not show that it is adequately represented.

The Information Commissioner’s Office distinguishes statistical, societal, evaluation, and emergent bias. Its guidance also warns that selection and measurement bias can be introduced by data suppliers. Treat provenance as a chain to inspect: who gathered the data, for what purpose, under what conditions, and whether those conditions match the system’s present use.

Labels may encode earlier judgments or institutional practices rather than an objective ground truth. Ask what the label means, who assigned it, what instructions they received, and whether disagreement was measured. Also inspect whether the target is a defensible proxy for the outcome you care about. If a model is trained to predict a historical decision, reproducing that decision does not by itself establish that the decision was fair.
Check whether missing values or measurement quality differ across groups. If people are less likely to be recorded, correctly labeled, or represented under a particular condition, a model may appear reliable in aggregate while being less dependable for them. Document exclusions and the consequences they may have for interpreting results.
How do I build a representative test set?
Construct the test set around the operational population and real conditions of use, then check whether it supports the group-level conclusions you plan to draw. A test that does not represent the people or circumstances at stake cannot establish how the system will perform for them.
Define slices before looking at results
Choose relevant subgroups from the use case and harm assessment, not only from categories that happen to be easy to measure. Consider intersectional slices when plausible harms could arise from combinations of characteristics. State each group definition and how membership is determined; ambiguous categories make comparisons difficult to interpret.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
NIST recommends representative human-subject data and disaggregated evaluation by characteristics such as race, age, gender, ethnicity, ability, and region where relevant. It also calls for explicit thresholds or alerts for representativeness. This means recording what evidence would make a slice too sparse or too different from the target population to support a confident conclusion.
Match test conditions to deployment
Use examples that reflect actual inputs, language, formats, and operating conditions. For a conversational system, include varied ways real users phrase a request; for a classifier, include the range of input quality and context expected in service. Include groups and conditions that are likely to be less common, but do not confuse a deliberately balanced challenge set with an estimate of real-world prevalence.
Keep development examples separate from final evaluation examples where possible. If people tune prompts, thresholds, or model behavior on the same cases later used to report performance, the reported test can overstate how well the system generalizes. Preserve the test-set version and explain how it was assembled.
Report sample sizes and uncertainty
For every result, report the number of examples behind it and uncertainty where applicable. Small subgroup samples can make apparent gaps unstable; lack of a statistically clear difference is not proof that groups are treated equally. If a slice is too small to support a conclusion, state that limitation and decide whether additional evaluation data or restricted deployment is needed.

| Measure | What it helps assess | Key interpretation |
|---|---|---|
| Overall accuracy | How often the system’s predictions match the evaluation labels across the test set. | Useful context, but an aggregate can hide subgroup differences. |
| Precision and recall by group | How reliable positive predictions are and how many relevant cases are found within each group. | Choose based on the cost of false alarms versus missed cases in the use. |
| False-positive and false-negative rates by group | Whether different groups experience different kinds of error. | These rates are compared across groups in equalized-odds analysis. |
| Calibration by group | Whether predicted confidence or risk corresponds to observed outcomes across groups. | Relevant when scores are interpreted as probabilities or used to rank risk. |
| Abstention or refusal rate by group | Whether the system declines or fails to provide an answer at different rates. | Important when refusal changes access, workload, or the need for human review. |
| Outcome rate by group | Whether groups receive a positive outcome at different rates. | Demographic parity compares these rates; a difference needs interpretation in the task context. |
For a model making a binary decision, demographic parity compares outcome rates across groups. Equalized odds compares true-positive and false-positive rates across groups. They answer different questions: similar outcome rates do not guarantee similar error patterns, and similar error patterns do not guarantee similar outcome rates. The appropriate choice depends on what the decision does and which errors matter most.
Report overall and disaggregated accuracy, precision and recall, false-positive and false-negative rates, calibration where relevant, and abstention or refusal rates when those behaviors affect users. Include sample counts or confidence intervals. Explain the operational meaning of any observed gap, and note metric conflicts rather than tuning to one measure without considering the others.
How can I test an LLM for harmful stereotypes?
Use a structured set of prompts that varies identity, context, and framing, then review both the outputs and how consistently the behavior appears. A handful of provocative prompts is not a reliable estimate of a model’s general behavior.
Design a balanced prompt suite
Cover dimensions relevant to the intended use, such as gender, race, ethnicity, religion, disability, age, nationality, sexual orientation, caste or class, occupations, and intersections. Include neutral prompts, counter-stereotypical prompts, and culturally varied phrasing. Balance comparisons so one group is not tested only with negative or high-risk scenarios while another is tested only with benign examples.
For example, a test designer might ask for descriptions of people in comparable roles while varying one identity cue at a time, then test requests that challenge a stereotype. These are test-design examples, not evidence that any particular model has produced a particular result. The point is to make the comparison controlled enough to identify whether the identity cue changes the response.
Score more than offensive wording
Review severity, valence, representation, refusal quality, and whether an output assigns traits, roles, abilities, or intentions unfairly. A response can avoid slurs yet still reinforce a stereotype by consistently associating a group with a narrow role. Conversely, a refusal can be unhelpful or unevenly applied even when it contains no harmful content.
Define rating instructions before scoring. Specify what counts as a stereotype, how to distinguish a factual or user-provided description from an unsupported generalization, and how reviewers should label borderline cases. Use trained reviewers familiar with the languages and cultural contexts being tested; record disagreement rather than hiding it in a single average score.

Preserve the exact test conditions
Save the exact prompts and outputs, along with model and API version, system or developer instructions, context, sampling settings, and date. This is essential for reproducing a finding because generative outputs may vary with configuration and model changes. UNESCO calls for combating stereotyping in AI outcomes and training data; prompt testing should therefore complement, not replace, review of data and deployment effects.
How do I test robustness, privacy, and foreseeable misuse?
Re-run relevant tests under realistic variations to see whether conclusions survive changes in wording, language, context, or operating conditions. A result from one phrasing or configuration should not be generalized beyond what was actually tested.
Vary the input and configuration
Use paraphrases, dialects, languages, context lengths, sampling settings, and adversarial framing where those variations are relevant to real use. Consider distribution shifts: changes in population, input quality, or environment that make deployment inputs differ from the evaluation data. Compare whether the same kinds of errors or harmful outputs recur, and record the conditions that change the result.

Include other risks when the use calls for them
Assess privacy, security, prompt injection, data quality, and misuse alongside fairness when they are plausible in the application. For example, a system that handles sensitive user material warrants privacy testing; a system that can be manipulated into revealing or acting on information warrants security review. OECD guidance recommends identifying robustness, privacy, data-quality, and adverse-impact risks across the lifecycle.
Do not present a limited prompt exercise as a comprehensive security or privacy audit. State what was tested, what was not, and what safeguards or specialist review are needed for risks outside the evaluation’s scope.
Who should review the results?
Combine technical measurement with domain expertise and input from people who may be affected by the system. Review is especially valuable when deciding what counts as harm, interpreting ambiguous outputs, and setting acceptable thresholds.
Involve relevant subject-matter experts and, where appropriate, impacted communities, workers, civil society, and external specialists. OECD guidance recommends stakeholder consultation; UNESCO calls for multidisciplinary, multicultural, and inclusive impact assessment. Participants should be able to identify harms a test designer may overlook, not merely validate a decision already made.
Plan how reviewers will handle disagreement and sensitive material. Give them clear instructions, a way to flag a test case that is culturally misleading, and a process for escalating severe findings. Record who reviewed the work and the limits of that review. Stakeholder feedback does not replace quantitative evaluation, and quantitative results do not replace contextual judgment.

How do I compare two AI models fairly?
Use the same task, test protocol, inputs, scoring rules, and operating conditions for both models. A comparison is misleading if one model receives easier prompts, more favorable sampling settings, or different treatment during scoring.
Hold the comparison constant
Fix prompts, context, sampling settings, test-set version, and metric definitions. For each system, record the exact model and API version and the date of evaluation. If one model cannot be tested with the same configuration, explain the difference rather than treating the results as directly equivalent.
Compare the dimensions that affect the decision
Assess subgroup and intersectional error gaps, harmful stereotype and toxicity severity, robustness to paraphrase and language variation, calibration and abstention, transparency and reproducibility, human oversight and recourse, privacy and data governance, and operational burden such as latency and cost. These axes help distinguish a system that performs well on a narrow score from one that is suitable for the intended setting.
Report sample counts or confidence intervals and qualitative examples, not just a ranked list. A model with fewer observed harms in one test suite is not automatically fairer in every context; the result is bounded by the tested population, prompts, settings, and scoring method.
What should a defensible evaluation report contain?
A useful report lets another evaluator understand what was tested, reproduce the procedure, interpret the limits, and see who is responsible for follow-up. NIST’s AI Resource Center Measure 2.1 calls for documented test sets, metrics, and tools and for representative, disaggregated evaluation.

Keep examples and prompts in a form that can be reviewed and reproduced, while handling personal or sensitive information appropriately. Document versions of the data, model, prompts, metrics, thresholds, and tools: if any of them change, a reader should be able to tell whether a reported result still applies.
What should happen after the evaluation?
Use findings to decide whether to mitigate, limit, or proceed with the intended use, and assign an owner to each action. A report without a decision path leaves known risks unresolved.
Possible responses include improving data coverage, changing labeling or thresholds, adding human review, limiting a feature or population, improving refusal or appeal routes, or delaying deployment until a material risk is addressed. The appropriate response depends on the harm and evidence; a metric gap alone does not prescribe one fix. Record residual risk and why it is acceptable—or why the system should not be used in that setting.

Is there a universal percentage for AI bias or stereotypes?
No single published percentage applies across AI models. A reported rate depends on the model, prompt set, language, domain, sampling, and scoring method; report a number only with the study’s population, year, and methodology. Official guidance provides methods and examples, not a cross-model prevalence statistic that can be used as a universal benchmark.
Frequently Asked Questions
Can fairness be proven with a certification or one audit?
An audit can provide evidence about a defined model, use, population, and test period, but it cannot establish that every later use is fair. Treat any assurance as bounded by the system version and conditions that were actually examined.
Should I collect demographic information to test an AI system?
Only collect or use sensitive characteristics when there is a valid, appropriately governed reason and the evaluation can protect the people represented. Involve privacy and legal specialists to determine what is permissible in the relevant jurisdiction and whether less sensitive alternatives can answer the question.
What if a vendor will not disclose training data details?
Record the missing information as an evidence limitation and ask for alternative documentation, such as subgroup evaluation, known exclusions, or independent test results. If the unknowns prevent assessment of a material risk, limit the use or require stronger safeguards rather than treating nondisclosure as proof of safety.
Who is responsible for fairness when a model is supplied by a vendor?
Responsibility is shared across the organizations that build, integrate, procure, and operate the system, although the exact legal duties depend on the use and jurisdiction. A deploying organization still needs to assess its own context, users, and downstream decisions instead of assuming a general vendor claim covers them.
