Estimate AI storage in separate buckets, then add them with a safety margin: datasets and their working copies, model artifacts, retained training checkpoints, inference files, logs, caches, and temporary space. A useful first pass is Total capacity ≈ H × (D + A + N × C), where D is the dataset and staging footprint, A is inference and operational data, N is the number of retained checkpoints, C is one checkpoint, and H is your headroom factor. Training storage is usually dominated by optimizer and gradient state plus checkpoint retention; inference generally needs far less permanent disk but can require substantial accelerator memory for long contexts, replicas, and caches.
The figures below are planning estimates, not universal limits. Google Cloud’s TPU guidance, for example, lists 2 TB of dataset storage and 200 GB of checkpoint storage per TPU for LLM pre-training, 12 TB and 1 TB for multimodal training, and 1 TB and 1 GB for inference. Those are workload-specific starting points, so calculate your own files and access pattern before buying capacity.
What storage must an AI project budget for?
Do not size a training volume from the model’s advertised parameter count alone. A production run can have several copies of the data, multiple representations of the model, large optimizer states, temporary files, and historical checkpoints.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
| Bucket | What it includes | Why it grows |
|---|---|---|
| Datasets and copies | Original data, cleaned data, tokenized or transformed files, sharded training files, validation and test sets, staging copies, and manifests | Each preprocessing stage may create another full or partial copy; distributed jobs may require local caches |
| Model artifacts | Base weights, tokenizer, configuration, adapters, export files, and quantized or unquantized variants | Different precisions and serving formats are often kept side by side |
| Training checkpoints | Weights, gradients, optimizer and scheduler state, metadata, and temporary write files | Checkpoint size is much larger than deployed weights, and retention multiplies it |
| Inference runtime | Serving replicas, logs, request or rollout artifacts, caches, and model packages | Replica count, context length, traffic and logging policy determine the footprint |
| Headroom | Space for concurrent jobs, failed runs, compaction, fragmentation and growth | A volume that is technically full can block a checkpoint or corrupt a job |
Keep durable data and archives separate from fast scratch space. A large object-storage bucket may hold the source corpus and old checkpoints, while local NVMe or a parallel filesystem handles active preprocessing and checkpoint writes.

How do I calculate the size of a model artifact?
Start with parameter count and the bytes used to store each parameter. The basic estimate is Model size ≈ P × Bw, where P is the number of parameters and Bw is bytes per stored weight.
| Representation | Approximate bytes per parameter | Important qualification |
|---|---|---|
| BF16 or FP16 | 2 | Does not include tokenizer, configuration, metadata or serving buffers |
| INT8 | 1 | Framework packing and scale information add overhead |
| 4-bit | About 0.5 | Actual files are larger because of group scales, metadata and packing |
For example, a 4-billion-parameter model stored in BF16 needs about 8 GB for weights alone. A 70-billion-parameter model in BF16 needs about 140 GB in a simple decimal calculation; NVIDIA’s published 70B AdamW example uses 130 GB for BF16 weights, reflecting its stated file layout and accounting.
Include the files that make the weights usable:
- Tokenizer vocabulary, merges or tokenizer model.
- Model configuration and generation settings.
- Adapter or low-rank fine-tuning weights.
- Exported formats for each serving runtime.
- Quantized and full-precision variants if you support more than one deployment target.
Do not confuse storage size with accelerator memory. Runtime memory also contains activations, attention or key-value cache, temporary kernels and framework allocations.
How large is a training checkpoint?
A training checkpoint normally contains more than weights. A practical first-pass formula is C ≈ P × (weight bytes + optimizer-state bytes + gradient bytes + other-state bytes). The “other” category covers scheduler state, random-number-generator state, metadata and framework-specific files.
AWS documents a baseline of about 2 bytes per BF16 or FP16 weight parameter plus roughly 8 bytes per parameter for Adam optimizer state, or approximately 10 bytes per parameter before extra framework files. If gradients are also saved at two bytes per parameter, the arithmetic reaches roughly 12 bytes per parameter. Actual checkpoints vary with optimizer, precision, sharding format and whether a framework writes master weights or temporary copies.
Worked example: a 4B-parameter fine-tune
Google Cloud’s fine-tuning example for a 4-billion-parameter BF16 model allocates 8 GB for weights, 8 GB for gradients and 16 GB for AdamW optimizer state. That is a 32 GB baseline before activations. It is a useful storage estimate for a checkpoint, but it is not a guarantee that a training process will fit in 32 GB of accelerator memory.
Worked example: a 70B AdamW checkpoint
NVIDIA’s example lists 130 GB of BF16 weights, 521 GB of FP32 optimizer state and 130 GB of gradients, for a 782 GB checkpoint. At one checkpoint every 30 minutes, the run writes 48 checkpoints per day. If every checkpoint is retained, that is approximately 37.5 TB written in 24 hours and about 1.13 PB over 30 days, before filesystem metadata, replication or failed-write overhead.

The example illustrates why retained versions and write traffic can matter more than the final model package. You may only deploy 130 GB of weights while repeatedly writing hundreds of gigabytes of training state.
How much dataset storage should I reserve?
Inventory every representation rather than multiplying the download size by a fixed rule. Record the measured size after each transformation.
- Source copy: Preserve the original files in durable storage so preprocessing can be reproduced.
- Cleaned or normalized copy: Account for deduplication, filtering, extraction and format conversion.
- Tokenized or feature files: These can be smaller or larger than the source depending on representation and metadata.
- Sharded training files: Count all shards, indexes, manifests and parity or replication copies required by the loader.
- Validation and test sets: Keep them separate if the pipeline stores independent copies.
- Staging and cache space: Include a second copy when a job downloads data locally or builds a temporary dataset.
Google Cloud gives platform-specific planning baselines of 2 TB of dataset storage per TPU for LLM pre-training, 12 TB per TPU for multimodal training and 1 TB per TPU for inference. Treat those figures as starting points tied to the described TPU workloads, not as a universal dataset multiplier.
How do I estimate total capacity?
Use a worksheet with explicit variables:
P= parameter count.Bw= bytes per stored weight.C= one complete training checkpoint.N= number of checkpoints retained.D= source, processed, tokenized, validation, test and staging data.A= inference artifacts, logs, caches and serving copies.H= headroom factor for temporary files, fragmentation and growth.
Then calculate Total capacity ≈ H × (D + A + N × C). Keep the units consistent: use decimal GB and TB throughout, or binary GiB and TiB throughout. A checkpoint estimate in gigabytes should not be silently mixed with a provider’s tebibyte quota.
Worked capacity scenario
Suppose a project measures 6 TB of dataset and staging files, keeps a 120 GB inference package and logs, and retains five 782 GB checkpoints from a 70B run. The unpadded total is:
6,000 GB + 120 GB + (5 × 782 GB) = 10,030 GB.
That is about 10.03 TB before headroom. The project should then add its chosen operational margin and any required replica, backup or replication policy. If a separate scratch volume is used for checkpoint assembly, size that volume for the largest simultaneous write, not just the archive total.
What checkpoint bandwidth do I need?
Capacity answers “will the files fit?” Bandwidth answers “can the job save and restart without unacceptable pauses?” Google Cloud states the core calculation as required bandwidth = checkpoint size ÷ checkpoint interval.

For the 782 GB checkpoint written every 30 minutes, the minimum sustained stream is about 0.434 GB/s, or 434 MB/s using decimal units. Real systems need additional bandwidth for concurrent readers, multiple jobs, metadata operations, replication and retries. A storage target that meets the arithmetic minimum in an isolated test can still stall when many workers checkpoint together.
Account for write amplification
- Write to a temporary file and rename only after completion, so the destination may need space for both old and new versions.
- Replication, erasure coding and snapshots can consume more physical capacity than the logical checkpoint size.
- Compression can reduce capacity but may shift the bottleneck to CPU time and reduce restart speed.
- Retaining more versions increases total writes even if the active checkpoint is overwritten.
Account for restart reads
Distributed jobs often restart many workers at once. AWS notes that a synchronized data-parallel job may write one model-replica checkpoint, while restart reads can multiply by the number of replicas. Model-parallel jobs shard the model across ranks, changing both the file layout and the concurrency pattern. Measure aggregate read bandwidth for the largest expected restart, not only the bandwidth of one client.
How does distributed training change storage requirements?
Parallelism changes access patterns even when it does not change the logical model size.
Data parallelism
Each worker processes a different batch while maintaining synchronized model state. A job may consolidate one checkpoint, but every worker can read that checkpoint during recovery. Local caches can reduce shared-storage pressure, at the cost of additional capacity and cache warm-up time.
Model or tensor parallelism
The model is divided across ranks. Checkpoints may be stored as many shards, and a restart can issue concurrent reads for all shards. Plan naming, manifests and shard placement so a missing or partially written shard is detected before a job starts.

How much storage does inference require?
Inference usually needs a smaller permanent artifact because optimizer and gradient state are absent. It still needs room for model replicas, quantized and full-precision files, tokenizer and configuration data, logs, request traces, rollout artifacts and serving caches.
For a rough accelerator-memory check, the Ohio Supercomputer Center gives the FP16 rule of thumb inference VRAM in GB ≈ 2 × model parameters in billions + 1 × context length in thousands. A 70B model with a 32K context therefore starts at roughly 172 GB by that rule (140 GB for weights plus 32 GB for context). This is a planning estimate, not a measurement of a specific serving engine; batching, attention implementation, quantization and cache policy can change the result.

- Disk: Stores model files, versions, logs and persistent caches.
- System RAM: Holds loader buffers, tokenization work and sometimes a CPU copy of weights.
- VRAM or accelerator memory: Holds weights, activations, key-value cache and runtime workspaces.
Quantizing a model can reduce the weight file and VRAM requirement, but retain the scale metadata and validate the actual packed file size produced by your framework. Long contexts and high concurrency can make the key-value cache larger than expected even when the model file is compact.
Which storage tier fits training and inference?
Choose a tier from measured capacity, sustained write bandwidth, restart read bandwidth, latency, durability, concurrent-client behavior, cost and portability.
| Tier | Good fit | Strengths | Trade-offs |
|---|---|---|---|
| Local NVMe or equivalent scratch | Preprocessing, shuffle files, temporary checkpoints and hot inference caches | Low latency and high per-node throughput | Usually tied to a machine; data may disappear when the node is replaced; capacity is fragmented across workers |
| Shared or parallel filesystem | Active multi-worker training and high-concurrency restart reads | One namespace, coordinated access and aggregate throughput designed for many clients | Metadata and contention behavior must be tested at the planned worker count |
| Object storage | Durable source datasets, checkpoint archives and cross-region or cross-cluster copies | Scalable capacity and durable retention | Higher latency and different consistency or rename semantics may require staging before training |
A common architecture keeps the authoritative dataset and retained checkpoints in durable object storage, stages the active working set on a shared or local fast tier, and copies only the versions needed for serving to the inference environment.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. How can I build a storage estimate step by step?
- Define the run: Write down parameter count, precision, optimizer, number of workers, context length, batch or concurrency targets, checkpoint interval and retention policy.
- Measure data: Record the size of source, processed, tokenized, sharded, validation, test and staging directories.
- Calculate artifacts: Multiply parameters by bytes per weight, then add tokenizer, configuration, adapters and each export format.
- Calculate one checkpoint: Add weights, gradients, optimizer state, scheduler state, metadata and any framework-created copies.
- Apply retention: Multiply the complete checkpoint size by the number of versions kept in each location, including archive and backup copies.
- Estimate inference: Add all serving replicas, quantized variants, logs, caches and rollout or evaluation artifacts.
- Set headroom: Reserve space for a simultaneous new checkpoint, failed runs, compaction, fragmentation and measured growth.
- Calculate bandwidth: Divide checkpoint size by the interval, then increase the target for concurrent reads, writers, replication and retries.
- Test the failure path: Restore a checkpoint with the full worker count and record time to first batch, peak capacity and peak metadata rate.
What commonly causes storage estimates to fail?
Counting only the final weights
Weights omit gradients, optimizer state and temporary checkpoint files. Use the complete checkpoint contents for training capacity.
Ignoring duplicate datasets
Tokenization, sharding and local staging can each create another copy. Measure directories after every pipeline stage.

Using average bandwidth
Average daily traffic hides the checkpoint burst. Size for the sustained write during the checkpoint window and the simultaneous restart read.
Filling the volume to its quota
Compaction, temporary files and copy-on-write snapshots need free space. A nearly full volume can fail a job even when the nominal checkpoint would fit.
Assuming quantization changes everything
Quantization reduces weight storage, but tokenizer files, scale metadata, replicas, logs and context caches remain. Verify the packed output and serving engine’s memory profile.

What should I record in a capacity plan?
Make the estimate auditable so it can be revised when the model or pipeline changes.
- Model name, parameter count, precision and optimizer version.
- Measured size of every dataset representation and its date.
- Checkpoint contents, shard count and compression setting.
- Retention count for local, shared and archive locations.
- Checkpoint interval and calculated minimum bandwidth.
- Expected worker count and peak restart readers.
- Inference replicas, context limit, concurrency and cache policy.
- Headroom policy and the alert threshold at which a run must stop or clean up.
Recalculate when you change precision, optimizer, context length, worker count, checkpoint frequency or retention. Storage requirements are properties of the workflow, not a permanent attribute of the model’s parameter count.
Frequently Asked Questions
How much storage does a 7B model need for Adam training?
A rough BF16 baseline is 14 GB for weights, 14 GB for gradients and about 56 GB for Adam optimizer state, or approximately 84 GB before scheduler state, framework files, activations and temporary space. Dataset copies and retained versions must be added separately.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsCan one SSD handle both training checkpoints and inference traffic?
It can for a small, single-node workload if measured write and read peaks do not overlap. For distributed training or production serving, separate scratch and serving paths are safer because checkpoint bursts can evict caches and increase inference latency.
Should checkpoints be compressed before archiving?
Compression can lower durable-capacity use, but the benefit depends on the tensor format and may add CPU time during saves and restores. Keep an uncompressed or fast-to-read copy for rapid recovery if restart time is an operational requirement.
How often should I recalculate my AI storage estimate?
Recalculate whenever parameter count, precision, optimizer, context window, worker count, checkpoint interval, preprocessing pipeline or retention policy changes. Also update it after measuring a real checkpoint and a full-scale restart, because framework overhead is workload-specific.
