For a practical self-managed deployment, run a pinned vLLM container on a Linux GPU node or GPU-enabled Kubernetes cluster, keep model weights on persistent storage, and put the server’s OpenAI-compatible API behind authentication and TLS. Start with one GPU sized for the model’s weights, context length, and expected concurrency; add replicas as traffic grows. If you would rather not operate GPU nodes and serving infrastructure, a managed endpoint is the simpler starting point.

The important work is not just starting a server: you also need to confirm the model’s license, choose compatible hardware, protect credentials and requests, and account for model-loading time in health checks. The guide below walks through those decisions and a deployment sequence.

What does deploying an open-source AI model on a GPU cloud involve?

It means renting or otherwise using cloud GPU capacity to load an open-weight model and serve inference requests over an API. The cloud provider supplies the infrastructure; you choose how much of the model-serving stack to manage, from a managed endpoint to a Kubernetes deployment you operate yourself.

For a self-managed setup, the core pieces are a GPU-compatible host, a serving engine such as vLLM, access to model weights, persistent storage for the model cache, and a protected network endpoint. A GPU-enabled Kubernetes cluster adds orchestration for deployments, probes, and replicas. The vLLM project describes Kubernetes as a way to scale and manage ML models using GPU resources, while Hugging Face describes vLLM as a high-performance, memory-efficient inference engine for open-source LLMs.

“Open-source” is often used loosely for models whose weights are available to download. Availability of weights does not by itself establish that a model can be used for every purpose: check the specific model’s license and terms for your intended commercial use and geography before deploying it.

Should you use a managed endpoint, Kubernetes, or a distributed serving framework?

Choose based on the amount of operational control you need and can support. A managed endpoint reduces infrastructure work; Kubernetes gives you control over the serving environment; a distributed framework becomes relevant when one-node serving and replica-based scaling are no longer enough.

Option Best fit Operational ownership Scaling approach Key trade-off
Managed endpoint, such as Hugging Face Inference Endpoints Teams that want to serve a model without administering a full GPU cluster The service handles more of the infrastructure; confirm exactly which node, image, scaling, networking, and observability tasks remain yours. Depends on the provider and endpoint configuration; verify current options with the service. Less infrastructure administration, with less direct control over deployment details than a self-managed cluster.
Self-managed Kubernetes with vLLM Teams that need control over networking, storage, probes, or replica topology You operate GPU nodes, drivers and images, deployment configuration, scaling, and observability. Start with one deployment and add replicas as demand grows. More control requires more day-to-day GPU and cluster operations.
Distributed serving framework, such as NVIDIA Dynamo Large or high-throughput deployments that need multi-node routing, cache management, or disaggregated serving You operate and tune a more involved serving architecture. Can coordinate disaggregated serving, KV-aware routing, cache management, and autoscaling around engines such as vLLM, SGLang, or TensorRT-LLM. Additional architecture is justified by specific scaling or routing needs, not simply by having a GPU model to serve.

Hugging Face’s engine documentation says TGI, vLLM, and SGLang will be equivalently good options for most use cases. That is a useful reminder that the serving engine should be chosen against your model, workload, and operating requirements—not on the assumption that one engine always wins. The sources cited here do not establish a universal performance ranking, total cost, or cloud price.

What should you compare before choosing?

  • Operational ownership: Determine who patches nodes and images, manages drivers and autoscaling, and monitors the service.
  • Hardware and topology: Check supported GPU vendors, regional availability, quotas, and whether your intended deployment needs one GPU or a multi-GPU topology.
  • Serving controls: Check support for batching, KV-cache behavior, quantization, tensor or pipeline parallelism, and LoRA adapters if you need them.
  • Security and data handling: Establish how secrets, network access, logs, and request retention will be handled. Do not assume a public serving example sets your organization’s access or retention policy.
  • Cost visibility: Compare current GPU hourly rates along with storage, egress, idle capacity, and any managed-service premium. Prices vary and should be checked with the provider for your region and configuration.

What GPU do you need to run an open-source LLM?

Choose a GPU based on the exact model and workload, not just its parameter count or a hardware name in a tutorial. You need enough capacity for the model weights and the runtime memory required by your chosen context length and concurrent requests; then benchmark the actual model, quantization, and serving settings.

The vLLM GPU guide lists NVIDIA GPUs with compute capability 7.0 or higher, with examples including T4, A100, L4, and H100. Its documentation also describes separate installation paths for AMD ROCm and Intel XPU. Google Cloud’s GKE Gemma serving tutorial lists NVIDIA B200, H100, RTX Pro 6000, and L4 as supported accelerator examples for that service. These are compatibility examples from different contexts, not a universal sizing table or proof that every model fits on each device.

Size for memory and the workload

  • Model weights: Confirm that the selected model and representation fit the GPU memory available to the serving process.
  • Context length: Longer inputs and outputs increase runtime memory needs. Set a maximum sequence length only after checking the model and available memory.
  • Concurrency and batching: Simultaneous requests and batching affect memory use and throughput. Validate batching limits against your expected traffic rather than guessing.
  • Quantization: Quantization can reduce memory requirements, but it may affect output quality. Test the quality implications for your use case before adopting it.
  • Parallelism: Tensor or pipeline parallelism can change how a model uses multiple GPUs. Use it only when the selected model and deployment justify the added configuration.

There is no published independent benchmark or universal GPU-to-model sizing table in the sources used for this guide. Before committing to a production configuration, test the exact model revision, GPU family, quantization, context length, and expected concurrency.

How do you deploy a model with vLLM on Kubernetes?

A dependable first deployment is a single vLLM serving workload on a GPU-enabled Kubernetes cluster. Record the exact model revision and container image digest, persist the model cache, keep any access token in a secret, and expose port 8000 only through a protected API path.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Choose the model and confirm its terms. Check that the model’s license permits your intended use in the places where you will operate. Record the exact Hugging Face repository revision so a future rollout can retrieve the same model version.
  2. Choose managed or self-managed operation. Use a managed endpoint if minimizing cluster administration is the priority. Choose Kubernetes when you need direct control over networking, persistent storage, probes, or replica topology and have the capacity to operate GPU nodes, containers, and observability.
  3. Select a compatible GPU and serving image. Check the serving engine’s hardware requirements and use an image or build compatible with the GPU vendor’s driver and software stack. Pin the image by digest or another immutable version, rather than relying on an unchanging tag name.
  4. Prepare persistent storage and credentials. Configure a persistent volume or equivalent cache for downloaded weights, so a restart does not needlessly download them again. For a gated model, put the Hugging Face token in a Kubernetes Secret or cloud secret manager. Do not put credentials in the container image or commit them in a manifest.
  5. Start the server. The Kubernetes example in the vLLM documentation uses vllm serve with a Hugging Face model ID and exposes port 8000. A minimal command shape is vllm serve <model-id>; supply the model-specific options required for your deployment after checking their memory and quality effects.
  6. Configure the workload and API exposure. Run the container as a Kubernetes workload with access to the GPU, persistent model cache, and required secret. Make the server available on port 8000 inside the deployment, then route external requests through a gateway or equivalent controlled entry point rather than exposing an unauthenticated service.
  7. Set health checks for real startup behavior. Configure startup, readiness, and liveness checks using the health-check approach supported by your deployment. Measure how long the model actually takes to load, then set initial delay and failure thresholds to allow for that time.
  8. Test before production traffic. Send requests through the same protected route clients will use, verify that the intended model revision responds, and inspect memory, latency, errors, and restarts under representative input lengths and concurrency.
  9. Scale in response to demand. Add replicas when one serving instance cannot meet traffic needs, and monitor whether requests are reaching them effectively. Consider a gateway for routing to replicas or model-specific endpoints; move to distributed serving only when its routing, caching, or multi-node capabilities solve a real bottleneck.

Which settings should you tune after the server starts?

Start conservatively and change one setting at a time. Model-specific options such as maximum sequence length, batching limits, tensor parallelism, and quantization affect memory use, throughput, or output quality; the correct values depend on the model and GPU configuration. Capture a working baseline before tuning so a change that causes startup failures or degraded output can be rolled back.

How should you secure and monitor the model API?

A running inference server is not automatically a production-ready service. Put the OpenAI-compatible API behind authentication and TLS, restrict network access and egress, and define how prompt and output data are logged and retained.

Protect access and credentials

  • Require authentication at the gateway or service boundary; do not treat an obscure URL as access control.
  • Use TLS for client connections and network policies to limit which services can reach the model server.
  • Store gated-model tokens in a secret manager or Kubernetes Secret, and grant access only to the workload that needs them.
  • Restrict egress and access to model storage to the minimum required for operation.
  • Set and document a logging and retention policy. Audit logs for sensitive prompt or output data rather than assuming inference logs are harmless.

Public serving examples establish how to run a server; they do not supply your organization’s authentication, authorization, or data-retention policy. Those controls need to be configured for your deployment.

Watch signals that explain failures and capacity

  • GPU memory and utilization: Identify memory pressure, unused capacity, or a GPU that is consistently underused.
  • Queue depth and latency: See whether requests are waiting and whether response times change as concurrency rises.
  • Token throughput and errors: Track serving output and failures against representative workloads.
  • Restarts and startup duration: Distinguish a genuinely unhealthy process from one still loading model weights.

What commonly breaks, and how do you fix it?

Most first-deployment problems come from a mismatch between model requirements and GPU memory, probes that expire before model loading finishes, or a hardware and image stack that is not compatible. Use the symptom to guide a targeted change rather than changing several settings at once.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Symptom Likely cause What to try
Out-of-memory during startup The weights, context configuration, or batch limits exceed available memory. Reduce context length or batch limits, choose a smaller or quantized model, or move to a GPU with more memory. Check output quality after quantization.
Repeated restarts while weights load Probe delays or failure thresholds are shorter than actual startup time. Measure load time and increase startup or readiness thresholds to match it. The vLLM Kubernetes documentation explicitly notes this probe failure mode.
The first request is slow A cold start or model-loading work is being counted as normal request performance. Warm the model, use a persistent cache, and report cold-start latency separately from steady-state latency.
Gated model cannot be fetched The workload lacks valid access credentials or the model’s access requirements have not been met. Verify model access and secret configuration; do not copy the token into a public image or source-controlled manifest.
Container fails on a GPU node The image and installed GPU software stack do not match the hardware or driver path. Pin a compatible CUDA, ROCm, or XPU build as applicable, and test it on the exact GPU family before rollout.
GPU is expensive but lightly used Capacity exceeds actual request demand, or idle development nodes remain running. Use request metrics to guide scaling thresholds and shut down idle development nodes.

How do you scale beyond one GPU instance?

For a first increase in capacity, add replicas and route requests across them. This is simpler than introducing a distributed serving framework, but it does not automatically solve every model-size, cache, or multi-node routing constraint.

A gateway can route traffic across replicas and support model-specific endpoints or LoRA adapters. For a large or high-throughput deployment that needs disaggregated serving, KV-aware routing, cache management, or autoscaling around multiple inference engines, NVIDIA Dynamo is an option to evaluate. Its added coordination should correspond to a measured scaling need; for a smaller service, a single instance or replica-based Kubernetes setup is easier to operate.

Scale based on observed demand and service behavior, including queue depth, latency, throughput, GPU utilization, and errors. The sources available here do not establish a universal replica count, autoscaling threshold, or latency target; those depend on the model, hardware, and workload.

What will a GPU-cloud deployment cost?

There is no single defensible cost figure without a provider, region, GPU type, storage configuration, and traffic pattern. Compare the current hourly GPU price with persistent storage and egress, idle capacity, and any managed-service premium; verify current values directly with the provider before choosing a configuration.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For self-managed Kubernetes, include the operational cost of keeping GPU nodes, images, drivers, scaling, and observability healthy. A managed endpoint may reduce that work, but its exact service responsibilities and charges depend on the endpoint configuration. Avoid estimating cost from a GPU model name alone: usage duration, utilization, storage, and traffic all affect the bill.

What is a sensible first production deployment?

Begin with the smallest setup that meets a measured workload rather than designing for hypothetical scale. Pin the model revision and serving image, verify license and hardware compatibility, persist weights, protect the endpoint, and confirm that health checks tolerate actual load time.

  • Use one GPU and one serving deployment as the baseline when the model fits and the target traffic allows it.
  • Record a representative baseline for startup duration, memory, latency, throughput, and errors.
  • Keep a rollback path to the last known-good model revision and image digest.
  • Add replicas when observed request demand requires more serving capacity.
  • Adopt distributed serving only when multi-node routing, cache management, or disaggregated execution addresses an identified constraint.

Frequently Asked Questions

What does an OpenAI-compatible API mean for my application?

It means the server exposes an API shaped to work with clients built for the OpenAI API, so an application may be able to use the endpoint by changing its connection configuration. Compatibility does not itself provide authentication, authorization, or a particular data-retention policy.

Can I test a vLLM deployment without a GPU?

The vLLM Kubernetes documentation says CPU use is for demonstration and testing, and performance will not be on par with GPUs. A CPU run can help validate basic deployment mechanics, but it is not a reliable substitute for measuring GPU serving capacity.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can I move a deployed model between cloud providers?

The serving workflow can be portable, but the actual deployment depends on each provider’s GPU availability, quotas, supported hardware, storage, networking, and compatible image stack. Recheck those items and test the pinned image on the destination GPU family before moving production traffic.
