Place each AI workload stage where its dominant constraint is easiest to satisfy: keep sustained, sensitive and predictable processing on premises when you can operate the infrastructure; use cloud capacity for bursty, experimental or fast-growing work; and run latency-critical inference at the edge, close to the sensors or machines producing data. Training, inference, updates, telemetry and retention rarely share the same ideal location, so a hybrid design is often the most practical answer.

The decision is not a referendum on one environment. It is an engineering exercise that weighs latency, data movement, utilization, resilience, governance, skills and full lifecycle cost for each stage of the workload.

Why are training and inference different placement problems?

Training builds or fine-tunes a model and usually needs large pools of specialized processors, high-throughput storage and sustained parallel work. Inference serves predictions from an already trained model; its critical measures are usually response time, availability, throughput and the location of the data and application making the request. Treating both as one placement decision can produce an expensive or unsafe architecture.

Training, fine-tuning and batch scoring

Training jobs are often intermittent but computationally intense. A team may need a large accelerator cluster for a short period, then little capacity while it labels data, evaluates results or waits for the next experiment. That shape favors elastic cloud capacity unless the organization has a consistently high utilization rate and can justify owning and operating the hardware. A research group with a steady queue, strict data-locality rules and an experienced platform team may instead obtain better control from an on-premises cluster.

Fine-tuning and batch scoring should be assessed separately from initial training. Fine-tuning may involve proprietary data that cannot leave a controlled environment, while batch scoring can be scheduled during low-cost or low-contention periods. Storage location, data-transfer time and the need to repeat a run are often more important than the model framework itself.

Online and real-time inference

Online inference is constrained by the user or machine waiting for a response. A model serving an industrial control loop, safety camera or disconnected vehicle cannot assume a round trip to a distant region. A customer-facing application may tolerate a network call if the selected region, service tier and fallback path consistently meet its latency and availability targets.

ITU-T Recommendation F.748.38, approved on June 13, 2024, describes cloud AI platform concerns including resource management, model development and deployment, high availability, performance, platform security, distributed serving, scheduling, version control, monitoring, authentication, access control and audit. Those concerns apply whether the serving endpoint is centralized or distributed across sites.

What are the practical differences between on-premises, cloud and edge?

The following matrix is a starting point, not a scorecard. A workload can fit more than one column when different lifecycle stages have different requirements.

Decision axis On premises Cloud Edge or on device
Latency and locality Strong for controlled local systems Depends on network path and selected region Strongest when data is generated at the device
Workload shape Sustained, predictable utilization Bursty, transient, experimental or rapidly scaling work Continuous local inference and fast control loops
Data residency and privacy Maximum organizational control, subject to internal controls Requires provider, region, contract and transfer review Data can stay local, but device exposure and hidden cloud transfers must be assessed
Capacity and hardware Fixed capacity, procurement and refresh burden Elastic capacity and managed services Constrained resources; fleet lifecycle matters
Cost drivers Capital equipment plus facilities, power, cooling, staff and refresh Usage, storage, transfer, support and provider dependence Device hardware, energy, connectivity, patching and fleet operations
Resilience Can provide local autonomy if designed well Depends on provider region and network availability Can continue through connectivity loss, but needs safe fallback and patching
Security operations Direct control and direct responsibility Shared-responsibility model Larger attack surface across devices, gateways and physical sites

How do I decide where each AI workload stage should run?

Use a repeatable assessment rather than selecting an environment by habit. Record the constraints for every stage, then test the smallest architecture that can satisfy them.

  1. Split the lifecycle. Make separate entries for data ingestion, preprocessing, training, fine-tuning, batch scoring, online inference, monitoring and model updates. Include retention and deletion because the place that stores data may differ from the place that serves predictions.
  2. Write the service requirement. Specify a latency target, throughput, availability objective, acceptable outage duration and offline tolerance. Note where the source data is produced and where the consuming application runs. A requirement such as “fast” is not testable; a p95 response target and a maximum disconnected period are.
  3. Classify the data. Mark personal, sensitive, regulated, proprietary and export-controlled information. Document permitted storage regions, processing locations, retention periods, transfer boundaries and who may administer the systems. Treat logs, prompts, images and telemetry as possible data disclosures rather than assuming only the training set is sensitive.
  4. Model the full cost. Count accelerator time, CPUs, memory, storage, backups, network ingress and egress, facilities, electricity, cooling, licenses, support, staffing, security controls, model evaluation and device-fleet management. Include idle capacity and refresh cycles, not just the price of a successful inference.
  5. Check operating capability. Confirm that the candidate location has people and processes for MLOps, platform engineering, privacy review, incident response, patching, access control, model evaluation and rollback. A technically possible deployment is not a practical one if nobody can maintain it.
  6. Select the simplest architecture that meets the constraints. Prefer one environment when it satisfies latency, privacy, scale, cost and resilience without extraordinary controls. Use a hybrid design when no single location can meet the requirements simultaneously.
  7. Pilot under representative conditions. Measure accuracy, p95 and p99 latency, throughput, failure behavior, energy, utilization, cost per request and operator workload. Include peak traffic, degraded networks, stale data and restart or rollback procedures.

When is on-premises AI the better choice?

On-premises deployment is strongest for sustained workloads with predictable utilization, strict locality requirements and an organization capable of running the platform. It provides direct control over hardware, network paths, identity integration and data handling, but that control comes with the entire operating burden.

Signals that favor an internal facility

  • Accelerators will be busy enough to justify ownership over their useful life.
  • Data cannot be transferred to a provider or another jurisdiction after legal and privacy review.
  • Applications need consistently low latency inside a controlled campus or private network.
  • Existing staff can operate clusters, storage, model-serving software, security monitoring and hardware repairs.
  • Procurement and refresh schedules are compatible with the model roadmap.

The costs that are easy to omit

Capital expenditure is only the visible part of the calculation. Include racks, networking, storage, backup, physical security, insurance, electricity, cooling, floor space, spare parts, warranties, software licenses, administrators, security personnel, training, compliance work and the cost of underused capacity. AWS cautions that hidden on-premises costs can change the apparent comparison with cloud services. A cluster sized for an occasional peak may spend most of its life idle; a cluster sized for average demand may force jobs to wait.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Operational trade-offs

Internal infrastructure can keep data and services local during a provider outage, but it also leaves the organization responsible for capacity planning and hardware failure. Refreshing accelerators can require a long procurement cycle, and an older platform may prevent adoption of a model that needs newer memory, interconnects or instruction support. Plan a replacement path before the first production deployment.

When does cloud capacity make more sense?

Cloud is a strong fit when demand is variable, the team needs results quickly, or the workload benefits from elastic capacity, managed services and access to newer hardware. You pay for consumption and accept provider, region, network and service-dependency considerations in return for speed and flexibility.

Workload characteristics that favor cloud

  • Experiments and training runs arrive irregularly or have uncertain resource needs.
  • Demand can grow faster than procurement and installation timelines.
  • Short-lived projects need specialized accelerators without a long-term ownership commitment.
  • Managed storage, orchestration, monitoring or deployment services reduce the team’s operating load.
  • Portable data and models can be placed in an approved region under an acceptable contract.

AWS recommends evaluating cloud first for new workloads that need technology or capacity unavailable on premises, while also stating that a cloud-first approach does not make cloud the better choice for every workload. That distinction matters: elasticity is valuable only when transfer, security, support and utilization costs remain acceptable.

Cloud-specific checks

Confirm the region in which data, backups, logs and support access may occur. Review identity integration, encryption, key management, service-level commitments, quota limits, accelerator availability, egress charges and exit procedures. Standardize account or subscription guardrails for identity, provisioning, security, budgets and usage so that a successful experiment cannot quietly become an uncontrolled production bill.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When should inference run at the edge?

Edge AI performs inference and decision-making on or near the device where data is generated. It is appropriate when a network round trip is too slow or unreliable, bandwidth is expensive, data should remain local, or a machine must continue operating during connectivity loss.

Strong edge use cases

  • Fast control loops in industrial, robotics or transport systems.
  • Video or sensor streams whose raw volume would make continuous upload impractical.
  • Sites with intermittent, expensive or unavailable connectivity.
  • Local processing requirements arising from privacy, residency or contractual rules.
  • Systems that must make a bounded decision even when a central service is unreachable.

The Canadian Centre for Cyber Security describes edge AI as inference and decision-making on or near the device where data is generated. In the usual pattern, models are trained centrally and then deployed to devices or gateways. Those devices may still contact cloud services for model updates, orchestration, telemetry or fallback, so “local inference” does not automatically mean “no data ever leaves the site.”

What edge adds to the operating burden

Each device becomes part of the security and reliability perimeter. Plan secure boot, hardware-backed keys where available, signed model packages, least-privilege services, encrypted storage, tamper evidence, remote attestation when appropriate, patch distribution and inventory. Offline operation can delay security fixes, while physical access can expose models and local data. A fleet-management process must handle replacements, lost devices, intermittent updates and devices that remain disconnected for long periods.

Is a hybrid architecture usually the practical answer?

Yes, when lifecycle stages have conflicting requirements. A common pattern trains or fine-tunes in a controlled central environment, distributes a versioned model to edge devices, keeps latency-sensitive inference local, sends summarized telemetry to a cloud service and retains a central fallback for exceptional cases. Another pattern serves normal traffic in the cloud but keeps a smaller model on site for outages.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Patterns to consider

  • Central training, distributed serving: aggregate approved data, train and evaluate centrally, then deploy signed artifacts to sites or devices.
  • Cloud burst for internal capacity: keep sensitive baseline data and routine jobs on premises, but send approved, short-lived workloads to cloud accelerators when demand exceeds internal capacity.
  • Edge-first with cloud coordination: make the immediate decision locally; upload only the minimum telemetry needed for monitoring, updates or later analysis.
  • Dual-path resilience: use an edge or local model during network failure and switch to a central model when connectivity and policy checks are restored.

Hybrid designs do not remove complexity. Standardize identity, provisioning, model version control, monitoring, access reviews, cost allocation and incident response across environments. AWS identifies low-latency processing, regulatory constraints, business continuity, migration and edge scenarios as common reasons for hybrid architectures, and emphasizes the need for adequate connectivity and consistent controls.

How should I compare the total cost of on-premises, cloud and edge?

Compare cost per useful result over the workload’s life, not the purchase price of a server or the per-request rate shown on a cloud calculator.

Cost category Questions to answer
Compute What accelerator, CPU and memory capacity is required at normal and peak load? How much time is idle?
Storage and data movement How much training data, model history, backup and telemetry is retained? What are transfer and egress volumes?
Facilities and energy Who pays for rack space, power, cooling, physical security and equipment insurance?
People and support How many hours go to provisioning, upgrades, incidents, evaluations, compliance and vendor management?
Lifecycle When will hardware, operating systems, accelerators and edge devices need replacement?
Risk and resilience What is the cost of downtime, stale models, lost telemetry, failed updates or an emergency migration?

For edge fleets, divide fixed engineering and management costs by the number of active devices, then test sensitivity to a smaller or larger fleet. A low per-device energy cost can be outweighed by site visits, replacement logistics or a difficult patch process. For cloud, include persistent storage, data egress, managed-service premiums and the cost of keeping reserved capacity available. For on premises, include utilization and refresh risk even after the equipment is paid for.

How do privacy, security and governance change the placement decision?

Privacy is a design input, not a final checklist. The Australian Office of the Information Commissioner recommends privacy by design, a privacy-impact assessment, due diligence, human oversight and lifecycle monitoring, and advises avoiding sensitive personal information in public AI tools. Apply those principles to every transfer, administrator path, log and model artifact.

Questions to document

  • What information is collected, and is each field necessary for the model?
  • Can identifiers be removed or transformed before data leaves a site?
  • Which regions and subprocessors may store or process the information?
  • Who can view prompts, raw inputs, outputs, logs and model checkpoints?
  • How are retention, deletion, correction and access requests handled?
  • How are humans notified and empowered to override consequential decisions?

On-premises control does not guarantee privacy; misconfigured internal access can expose data. Edge locality does not guarantee privacy either, because a device may be physically accessible or may silently forward telemetry. Cloud providers offer security controls, but the customer still has to configure identity, data handling, contracts and regional restrictions correctly.

What safety controls are required for autonomous edge systems?

Any system that can affect people, machinery or physical processes needs controls independent of the AI model. Map every input and decision, define the worst credible failure and provide a fallback that does not depend on the model.

  1. Document the permitted operating envelope and the conditions that require a safe stop.
  2. Separate the AI service from operational technology so a model compromise cannot directly reach every control function.
  3. Test abnormal, missing, stale and adversarial inputs, plus degraded power and network conditions.
  4. Keep tamper-resistant logs of inputs, model version, decision, operator action and override events.
  5. Provide an independently operated override or shutdown control that remains available when the model or network fails.
  6. Stage model updates, verify signatures and retain a known-good rollback version.

Autonomous systems can act faster than a human can intervene. The design must therefore limit what a single prediction can do, not merely record the decision after the fact.

How should I run a placement pilot?

Choose one representative workload and test at least two viable locations. Use the same model, data slice, accuracy criteria and traffic profile so the comparison reflects architecture rather than tuning differences.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Measurements to collect

  • Accuracy, calibration and drift under production-like data.
  • p95 and p99 latency, throughput and queue time.
  • Behavior during packet loss, disconnected operation, restarts and provider or site failure.
  • Accelerator and memory utilization, energy consumption and storage growth.
  • Cost per training run and cost per successful inference, including transfer and operations.
  • Time spent by engineers and operators on deployment, monitoring, patching and recovery.

Document the failure behavior, not just the median result. A slightly slower design that fails safely, preserves data locality and can be operated by the available team may be preferable to a faster design that requires heroic intervention.

Which placement fits common scenarios?

Irregular experimentation with approved, portable data

Cloud accelerators are usually the simplest starting point because capacity can be obtained for each experiment and released afterward. Reassess the choice if experiments become continuous, transfer volumes grow or the data classification changes.

Continuous inspection on a factory line

Run the immediate vision inference on a gateway or device near the line to avoid network-dependent control decisions. Send selected metrics or clips for central monitoring only when policy permits, and keep a tested local fallback for connectivity loss.

Highly sensitive records with steady utilization

An on-premises platform may provide the most predictable locality when the organization can staff security, capacity and refresh operations. A private or approved cloud region can still be evaluated, but only after contractual, regional and transfer controls are documented.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Customer application with global, uneven demand

Cloud serving can absorb regional peaks and simplify expansion. Keep a local or regional fallback if the service has strict latency or availability requirements, and test the effect of model size and network distance on p95 and p99 latency.

What should the final architecture decision record contain?

Record the workload stage, chosen location, rejected alternatives and the evidence behind the choice. Include data classifications, latency and availability targets, expected utilization, cost assumptions, operator ownership, model-update process, rollback plan, regional restrictions, security controls and review triggers. Revisit the decision when traffic shape, model size, regulation, hardware availability or staffing changes.

Frequently Asked Questions

Can training and inference use different environments for the same model?

Yes. A model artifact can be trained and evaluated in one controlled environment, distributed to another location for serving, and monitored through a third system. Keep version identifiers and approval records attached to every deployed copy so that a prediction can be traced back to the exact artifact and configuration.

What should happen to telemetry when regulations prohibit sending raw data off site?

Treat telemetry as a separate data product and classify it before designing the pipeline. Aggregate or redact information locally, transmit only fields allowed by policy, and retain the raw stream at the site when investigation or retention rules require it.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How often should an edge model be updated?

There is no universal interval. Set the cadence from observed drift, safety impact, vulnerability response time and the site’s ability to verify and roll back an update; high-risk systems should favor staged releases and explicit approval over automatic replacement.

Does a cloud-first policy require every AI workload to run in the cloud?

No. Cloud-first is an evaluation preference, not an exemption from latency, privacy, resilience or cost requirements. A documented comparison can legitimately conclude that on-premises or edge placement is safer or more economical for a particular stage.
