Choose storage for an AI inference server as a tiered system, not as a single drive. Keep the authoritative model files in durable object storage or a shared parallel file system, copy frequently used revisions to node-local high-endurance NVMe, and place active weights and the working KV cache in GPU memory whenever the serving stack permits it. Use host RAM for supported offload and block storage for the operating system and ordinary persistent volumes.

The right design is the one that meets your measured first-ready time, time to first token, inter-token latency, throughput, concurrency, capacity, recovery, and error-rate targets. Local NVMe usually accelerates staging and warm starts; it should not become your only copy of a model. Remote storage can be durable and elastic, but download, network locality, prewarming, and cache invalidation determine whether users experience seconds or minutes of startup delay.

What storage architecture should an AI inference server use?

A practical architecture separates four jobs: durable artifact storage, shared access, node-local acceleration, and runtime memory. Each tier has a different failure domain and performance profile, so forcing every workload onto one medium creates either unnecessary cost or avoidable latency.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Durable source of truth: Store versioned model weights, tokenizer files, configuration, and conversion outputs in object storage or a protected shared repository.
  • Shared serving repository: Use a parallel file system when multiple workers or nodes must read the same weights concurrently, or when supported KV-cache workflows move data between workers.
  • Node-local acceleration: Cache the revisions and temporary files needed by a node on high-endurance NVMe. Treat this copy as disposable and version-aware.
  • Runtime memory: Keep active weights and the hot KV cache in GPU memory where possible. Use host memory only for offload modes supported by the model server and hardware.
  • General persistence: Put the boot image, logs, metadata, and ordinary application volumes on block storage or another appropriate persistent-volume service rather than on the model-serving data path.

NVIDIA’s inference guidance emphasizes separating persistent model artifacts from ephemeral cache and telemetry. Its reference architecture also identifies local NVMe as a place for image caches, model caches, temporary tensors, and short-lived logs. Cisco’s AI storage guidance makes the same distinction: local cache improves repeated reads, but it does not replace shared storage or an authoritative repository.

What is each storage tier best at?

Tier Best use Main strengths Main cautions
GPU memory Active weights, working memory, active KV cache Lowest access latency while serving Fixed capacity and competition with runtime memory
Host memory Supported weight or KV offload and cache data Faster access than persistent storage Limited capacity and loss on restart
Local NVMe Model staging, hot cache, temporary tensors, supported spill Low latency, no repeated remote reads, faster restart and scale-out Node-local failure domain; stale copies must be refreshed or invalidated
Shared parallel file storage Concurrent weight loads, shared model repository, supported KV-cache exchange Shared access and high concurrent-reader capability Network dependency, cost, and operational complexity
Object storage Canonical model artifacts, versioned releases, asynchronous workflows Durability and elastic capacity Download path and cold-start latency require optimization
Block storage Boot disks, persistent volumes, general application state Familiar provisioning, snapshots, and broad platform support Usually not the best model-serving data plane without a cache

How do I choose local NVMe for model caching?

Select local NVMe by sustained serving behavior, not by the largest sequential-read number on a specification sheet. Confirm the server’s supported form factor, PCIe generation, lane allocation, cooling, and endurance rating, then reproduce actual model-load and cache-hit operations.

Size the cache for the working set

Start with the largest set of model revisions that may be used simultaneously. Add container layers, tokenizer and configuration files, conversion or quantization scratch space, temporary tensors, and operational copies created during an update. Leave capacity for wear-leveling and for a refresh that must coexist with the currently served revision. If the cache cannot hold the working set, every eviction becomes a possible remote download and cold-start event.

Match the drive to the server topology

For data-center inference, NVIDIA recommends a high-bandwidth NVMe flash drive per CPU. For edge inference, it recommends one average-bandwidth, lowest-latency NVMe drive per system. These are topology guidelines rather than universal purchasing rules: a multi-socket host, shared PCIe root complex, or thermally constrained edge chassis can change the result.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Evaluate endurance and thermal behavior

Model refreshes, image pulls, temporary conversion files, and cache churn can write far more than a simple read benchmark suggests. Check the drive’s endurance rating and sustained performance at the temperature your chassis can maintain. Measure performance after the cache is populated and during concurrent reads, rather than only immediately after provisioning.

Make local copies safely disposable

Store a model identifier and immutable revision alongside every cached artifact. At startup, the serving process should verify that identifier before mapping weights. When a revision changes, refresh or invalidate the old copy deliberately; never assume that a filename alone identifies the bytes. Cisco specifically cautions that local cached artifacts must be matched to the required model version and refreshed when that version changes.

Should model weights live in object storage or a shared file system?

Use object storage for the durable source of truth and a shared parallel file system when serving requires frequent, concurrent access. Many deployments use both: object storage holds releases, while a shared or local cache supplies the read performance needed by workers.

When object storage is the better foundation

Object storage is well suited to versioned releases, retention, replication, and asynchronous workflows. It lets you keep a canonical copy independent of any one node or cluster. The trade-off is the path from an object request to GPU memory: network distance, authentication, decompression, and serialization can dominate readiness unless you stream, prewarm, or cache the files.

AWS documents an EKS pattern that stores weights in S3, streams them into GPU memory, and uses local NVMe instance-store space to cache subsequent pulls. AWS notes that model weights can be 10–100+ GB and that optimized streaming can reduce a load that otherwise takes minutes to one that takes seconds. The exact improvement depends on model format, network path, node type, and concurrency.

When shared parallel storage is justified

Choose shared parallel file storage when many nodes pull the same weights at once, when a model repository must be mounted by several workers, or when supported serving software exchanges KV-cache data between workers. Google Cloud recommends Managed Lustre for sub-millisecond parallel access in these situations and recommends Rapid Cache or Rapid Bucket to improve model-download and cold-start behavior.

A shared file system adds network and service dependencies. Plan what happens if it is slow or unavailable, and retain the object-store copy so a replacement repository can be rebuilt. A local cache can reduce reads from the shared system, but it cannot provide durable recovery by itself.

Where block storage fits

Block volumes are a good default for operating-system disks, package caches, metadata, and ordinary persistent application state. They can hold models in smaller deployments, but they are usually less effective as the serving data plane than object storage plus a hot local cache or a purpose-built parallel file system. Validate the actual sustained read and concurrent-reader behavior before selecting block storage for large weight files.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How much NVMe capacity and throughput do I need?

There is no universal capacity or throughput number for inference storage. The answer depends on model size and format, how many revisions are resident, context length, concurrency, retention, replication, startup objectives, and whether the workload uses KV-cache offload. Size from measured load paths and failure assumptions.

Use a capacity worksheet

  1. List every model revision that can be scheduled on a node at the same time.
  2. Record the on-disk size of each weight set, tokenizer, configuration, adapter, and quantization or conversion artifact.
  3. Add container layers, temporary tensors, staging space for an atomic refresh, and logs that must remain on the node.
  4. Add the space required to keep the current revision while downloading and validating the next revision.
  5. Reserve operational headroom for wear-leveling, filesystem overhead, and a node replacement or recovery procedure.
  6. Compare the result with the usable capacity after formatting and any platform reservation; do not size from the advertised raw number.

Measure the read path that actually matters

Record model-download time, cache-hit time, disk-to-GPU transfer time, first-ready time, time to first token, inter-token latency, request latency, throughput, and error rate. A drive with an impressive peak sequential-read figure may deliver a different result when several workers read different files, decompression consumes CPU, or PCIe lanes are shared with GPUs and network adapters.

Interpret published deployment figures carefully

One DeepInfer deployment documents 20 SSDs of 30.73 TB each per KV-cache storage server, at least 40 GB/s read throughput and 5 GB/s write throughput, retention for 24 hours, and approximately 14.4 TB of logical storage per GPU. Those figures describe that deployment’s model, context lengths, concurrency, retention, replication, and failure assumptions; they are not baseline requirements for every inference server.

How can I reduce model cold-start time?

Reduce cold starts by shortening every stage between an unavailable node and the first usable response: locate the artifact near the GPU, avoid duplicate downloads, stream or prefetch large files, and validate the cache before traffic arrives.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Publish immutable revisions. Write weights and metadata to the durable repository under a revision identifier. Do not overwrite bytes behind a stable filename.
  2. Prewarm likely nodes. Download frequently used revisions to local NVMe before a deployment or scale-out event when capacity allows.
  3. Stream the first load. Use a serving stack that can stream model weights directly toward GPU memory instead of waiting for a complete remote copy when that mode is supported.
  4. Reuse node-local data. Keep a verified local copy so replacement pods on the same node do not repeat the remote download.
  5. Parallelize safely. Allow concurrent readers from a shared repository when it can sustain them; otherwise coordinate downloads so a scale-out event does not create a thundering herd.
  6. Gate readiness on useful milestones. Report when weights are validated and the first request can be served, not merely when a container process starts.
  7. Measure warm and cold paths separately. A cache-hit result can hide a remote-download bottleneck that users see after node replacement.

SageMaker HyperPod’s weights-cache feature pre-populates model files on host-local NVMe so pods on one node avoid redundant remote downloads during scale-out. Google Cloud’s Rapid Cache and Rapid Bucket target the same cold-start problem for model downloads, while Run:ai Model Streamer is recommended there for vLLM peak download performance. These services change the transfer path; they do not eliminate the need to size local capacity and verify revisions.

What topology and geography should influence the decision?

Measure locality explicitly. A cache on the same node as the GPU has a different latency and failure domain from a file system in the same zone, and both differ from an object bucket or file service in another region.

Placement Typical implication Questions to test
Same node Lowest transfer latency and no network hop, but loss when the node fails Can the model be rebuilt quickly from the durable source? Is the NVMe thermally stable?
Same zone Shared access with short network distance Can the service sustain concurrent reads during a fleet scale-out?
Remote region Potentially higher latency, egress exposure, and dependence on inter-region connectivity What is the measured download time and what happens during a link or service outage?

Keep compute, shared storage, and the object-store bucket as close as practical, then verify with measurements rather than assuming that a provider’s nominal bandwidth is available to every node. Record zone, region, network mode, CPU and GPU topology, and cache state with each benchmark.

How should I benchmark an inference storage design?

Benchmark the serving stack with the production model and representative prompts. Synthetic disk tests are useful for finding a hardware limit, but they cannot predict decompression, weight format, GPU transfer, scheduler behavior, or concurrent request effects on their own.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Capture these measurements

Measurement What it reveals
Model download time Remote repository, network, authentication, and transfer performance.
Cache-hit time Whether local or shared caching actually avoids the remote path.
Disk-to-GPU time Storage, CPU, PCIe, and runtime staging efficiency.
First-ready time End-to-end time until the server can accept useful traffic.
Time to first token User-visible startup and prompt-processing delay.
Inter-token latency Whether storage or offload interferes with steady generation.
Request latency and throughput Service behavior at the target concurrency.
Error and recovery rate Impact of storage faults, timeouts, and failed cache refreshes.

Run a repeatable test matrix

  1. Run a cold start with an empty local cache.
  2. Run a warm start with a verified cache hit.
  3. Evict the required revision and repeat the download.
  4. Start several replicas simultaneously to test concurrent readers and bandwidth contention.
  5. Replace a node and measure recovery from the durable repository.
  6. Throttle or disconnect the shared repository and observe readiness, timeout, and fallback behavior.
  7. Repeat with representative context lengths, prompt and output distributions, and concurrency levels.

For every run, record the model revision, backend and runtime version, GPU type, node topology, network mode, cache state, concurrency, and prompt/output distribution. Keep benchmark logs and telemetry on retention-appropriate storage rather than competing with the hot model path.

How should cache invalidation and recovery work?

Make cache correctness part of deployment, not an informal operator task. A safe refresh downloads a new revision beside the old one, verifies integrity and metadata, switches the serving reference atomically, and removes the old copy only after no active process needs it.

  • Restart behavior: Assume local NVMe and host RAM may disappear with a node replacement; recovery must work from shared or object storage.
  • Outage policy: Decide whether an unavailable repository blocks new replicas, serves existing replicas, or falls back to a known-good cached revision.

Cache invalidation is especially important when a model name remains constant while weights, adapters, tokenizer files, or runtime requirements change. A stale local copy can produce incorrect results without causing an obvious storage error.

What are the most common storage design mistakes?

Using local NVMe as the only repository

A node-local cache disappears with the node and can be corrupted or exhausted. Keep the canonical artifact elsewhere and test a full rebuild.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Buying for peak sequential bandwidth

Advertised peak numbers may not represent sustained, concurrent model loads. Test after thermal stabilization and under the same reader count and PCIe topology used in production.

Ignoring cache misses

A warm benchmark can look excellent while a node replacement takes minutes. Include cold starts, eviction, and scale-out in acceptance testing.

Letting revisions overwrite one another

Mutable paths make rollback and invalidation ambiguous. Use immutable revisions and an explicit activation pointer.

Placing telemetry on the hot path

Logs and traces can consume capacity and write bandwidth needed for model staging. Put them on retention-appropriate storage and enforce quotas.

Which storage design should I choose?

Use the following decision sequence to turn measurements into an architecture.

  1. One node, one or a few frequently used models: Keep durable revisions in object or shared storage and use local NVMe sized for the simultaneously hot set, temporary files, and refresh headroom.
  2. Several nodes loading the same large models: Add a shared parallel file system or an equivalent high-concurrency cache, while retaining object storage as the source of truth.
  3. Frequent autoscaling or short-lived pods: Prioritize prewarming, host-local weights caches, or streaming, then measure first-ready and first-token time during a scale-out burst.
  4. KV-cache offload or exchange: Follow the serving engine’s supported design and size shared storage from measured read and write rates, retention, replication, and context distribution.
  5. Edge or disconnected operation: Favor local NVMe capacity and endurance, but define how models are refreshed and how a failed drive or node is repopulated.

Approve the design only after it passes cold-start, warm-start, cache-miss, node-replacement, and storage-outage tests. The winning tier is the one that meets user-visible latency and recovery targets with enough capacity and endurance for the real workload.

Frequently Asked Questions

Can an AI inference server run entirely from object storage?

It can, but every cold load depends on the object-service path, network locality, authentication, and transfer rate. For production fleets, retain object storage as the durable source while adding streaming, prewarming, or a local/shared cache to make startup predictable.

Free tools Windows power users keep installed

How do I know whether my NVMe is becoming a bottleneck?

Compare cache-hit model-load time with disk-to-GPU time while increasing concurrent readers. Rising queue depth, thermal throttling, or a widening gap between advertised and sustained throughput indicates that the drive, PCIe path, CPU staging, or cooling needs investigation.

What should happen to cached weights after a model update?

Download and validate the new immutable revision beside the active one, switch traffic atomically, and remove the old copy only when rollback and active-process requirements are satisfied. A filename change alone is not a sufficient invalidation signal.

Do I need separate storage for KV cache and model weights?

Separate tiers are useful when their access patterns conflict: weights are read mainly during load, while KV-cache workflows can generate sustained reads and writes with retention requirements. Whether they need separate devices or services depends on measured contention, durability needs, and the serving engine’s supported offload design.
