The right AI inference platform is the most managed option that meets your model, latency, scale, security, and cost requirements. Start by measuring model size and precision, prompt and response lengths, concurrency, traffic variability, latency SLOs, availability, and data-residency needs. Choose a managed foundation-model API when a supported model and elastic traffic matter most; choose a managed endpoint when you own the model but want the provider to run serving infrastructure; choose self-hosted compute or Kubernetes only when custom serving, hardware control, private data paths, or sustained utilization justify the operational work.

Platform selection is a workload-engineering decision, not a simple comparison of GPU types or vendor feature lists. The sections below show how to classify your workload, estimate capacity, compare operating models, test candidates fairly, and avoid scaling and cost traps.

What should you measure before choosing an inference platform?

Define the workload and its service-level objectives (SLOs) before looking at products. Model size alone cannot predict the platform you need: token lengths, concurrency, queueing, traffic peaks, recovery requirements, and precision often matter just as much. AWS Prescriptive Guidance (2026) identifies these as core sizing inputs and notes that lower-precision weights can reduce memory requirements and improve throughput.

Model and serving requirements

  • Architecture and parameter count: record the exact model family, number of parameters, mixture-of-experts behavior if applicable, and whether you use a base, fine-tuned, or proprietary model.
  • Precision and quantization: document FP32, FP16, BF16, INT8, INT4, or another format, including any accuracy acceptance threshold. Lower precision can reduce accelerator memory use, but validate quality and kernel support.
  • Runtime features: list requirements for continuous batching, prefix caching, speculative decoding, streaming responses, function calling, custom kernels, tensor or pipeline parallelism, and GPU sharing.
  • Packaging: determine whether the platform accepts your container, dependencies, tokenizer, custom weights, and startup hooks. A hosted API may not expose these controls.

Latency, throughput, and concurrency

Measure time to first token (TTFT), inter-token latency, end-to-end latency, queueing delay, throughput, and concurrency under realistic prompts and outputs. Set separate p50, p95, and p99 targets; an average latency figure can hide a tail that violates your SLO. Capture both streaming and non-streaming behavior if your application uses both.

Traffic shape and availability

Describe normal request rate, peak request rate, peak-to-average ratio, burst duration, batch windows, and how quickly demand can change. Note whether scale-to-zero is acceptable and how much startup delay users will tolerate. Define availability, retry, failover, and recovery objectives, including the maximum data or work you can lose during an outage.

Security and placement

Specify identity controls, encryption requirements, private networking or VPC access, region restrictions, data residency, retention rules, audit logging, and compliance obligations. Verify that the exact model, endpoint type, and region support these controls; a provider may offer a feature on one deployment path but not another.

Which inference platform model fits your workload?

Most teams can choose among three operating models: a managed foundation-model API, a managed model endpoint, or self-hosted compute/Kubernetes. The more control you take, the more infrastructure and on-call responsibility you accept.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Platform path Best fit Control Operations you own Main trade-off
Managed foundation-model API Supported model, fastest production path, spiky or low-to-moderate traffic Model and runtime choices are limited to the provider catalog Application integration, quotas, prompt controls, monitoring, and fallback logic Less control over weights, hardware, serving engine, and sometimes placement
Managed model endpoint Your fine-tuned, proprietary, or open-weight model with provider-operated serving Model artifact and endpoint configuration are yours; infrastructure is abstracted Model packaging, deployment policy, SLO monitoring, and cost governance Less low-level tuning than owning the cluster; endpoint pricing can include idle capacity
Self-hosted compute or Kubernetes Specific serving engine, custom kernels, unusual parallelism, private data paths, or sustained high utilization Maximum control over hardware, software, networking, and scheduling Provisioning, drivers, autoscaling, health checks, upgrades, rollouts, failover, observability, and incidents Highest operational burden and capacity risk

When is a managed foundation-model API the best choice?

Use a managed API when an approved foundation model already meets quality and security requirements and you value rapid delivery over control of the serving stack. AWS’s 2026 decision guidance places a managed API first when it satisfies the workload requirements.

  • Traffic is intermittent, seasonal, or difficult to forecast, so paying per request or token is preferable to keeping accelerators warm.
  • Your team does not need custom weights, kernels, tokenizer changes, or a specialized inference server.
  • You need to launch an application before building GPU operations, capacity planning, and incident processes.
  • You can accept the provider’s model versioning, quotas, regions, and data-handling terms.

Check model availability in the target region, context and output limits, streaming behavior, rate limits, safety controls, and version-deprecation policy. Keep an abstraction layer in your application so you can change models or providers without rewriting business logic.

When does a managed model endpoint make sense?

Choose a managed endpoint when you own the model but want the provider to handle provisioning, scaling, health checks, networking, monitoring, and deployment workflows. This is the usual middle ground for fine-tuned, proprietary, or open-weight models.

Match endpoint mode to request behavior

Endpoint mode Use it for Key operating characteristic
Real-time inference Sustained, low-latency requests with predictable traffic Always available with consistent latency characteristics; idle capacity can cost money
Serverless inference Intermittent synchronous requests and spiky demand Provider manages capacity; startup or quota behavior can affect latency
Asynchronous inference Long-running jobs or large payloads that do not require an immediate response Can scale down to zero for latency-insensitive workloads
Batch transform Offline scoring of a known data set Optimized for jobs rather than interactive request latency

Amazon SageMaker’s current guidance makes these distinctions explicit: real-time inference suits low-latency, predictable traffic; serverless suits spiky synchronous traffic; asynchronous inference supports long-running or large requests and can scale down to zero; batch transform is for offline data.

Azure managed online endpoints similarly provide turnkey CPU or GPU serving, scaling, security, and monitoring. They are useful when you want private networking, traffic mirroring, and safer rollout workflows without taking ownership of a Kubernetes cluster.

When should you self-host on compute or Kubernetes?

Self-host when measured benefits from control outweigh the cost of operating the platform. Typical reasons include a required serving engine, custom CUDA or other accelerator kernels, unusual tensor or pipeline parallelism, GPU partitioning, strict private data paths, or sustained utilization high enough to improve unit economics.

What you gain

  • Choose the exact accelerator generation, memory size, host topology, driver, runtime, and serving software.
  • Implement custom batching, caching, scheduling, quantization, and model loading behavior.
  • Keep request data and model artifacts inside a network boundary you control.
  • Optimize capacity for stable, high utilization instead of paying a managed-service premium.

What you must operate

  • Capacity reservations, image builds, drivers, accelerator health, node replacement, and storage.
  • Autoscaling, queue management, readiness and liveness checks, draining, and overload protection.
  • Canary deployment, rollback, model validation, security patching, logging, metrics, tracing, and alerting.
  • 24/7 incident response for hardware failures, quota exhaustion, software regressions, and regional outages.

Raw virtual machines give maximum control but leave scaling, health checks, failover, and monitoring to your team. Kubernetes adds scheduling and orchestration but also makes the cluster your responsibility. AWS documents EC2 and EKS as customer-controlled paths and identifies Inferentia and Trainium as alternatives worth evaluating for sustained throughput; benchmark them with your model rather than assuming a theoretical advantage.

How do you size GPUs for a growing language-model workload?

Size for the complete serving problem: weights, runtime overhead, key-value (KV) cache, concurrent sequences, and performance targets. A model that fits in memory at one request may fail under production concurrency because KV-cache pressure and batching consume the remaining capacity.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Freeze the model artifact. Record parameter count, precision, quantization method, tokenizer, maximum context, and expected output length.
  2. Estimate weight memory. Multiply parameters by bytes per parameter, then add room for framework, CUDA, communication buffers, and fragmentation. Treat this as a lower bound, not a deployment target.
  3. Estimate KV-cache demand. Use concurrent sequences, prompt tokens, generated tokens, number of layers, attention dimensions, and cache precision. Long contexts and high concurrency can require more memory than the weights.
  4. Choose parallelism and placement. Decide whether one GPU is sufficient or whether tensor, pipeline, or expert parallelism is required. Check interconnect bandwidth and topology, not only total memory.
  5. Benchmark tokens per second and latency. Run representative prompts and outputs at normal and peak concurrency. Record TTFT, inter-token latency, p95/p99 latency, queueing, and error rates.
  6. Add failure and growth headroom. Reserve capacity for rolling deployments, one failed replica, traffic surges, and model updates. Document the scale-up time that users will experience.

Do not infer capacity from a vendor’s single throughput number. Different prompt lengths, output lengths, batching policies, software versions, and hardware classes can produce very different results.

Which metrics should trigger inference autoscaling?

Use queueing and user-visible latency as primary signals, with accelerator metrics as diagnostics and safeguards. AWS notes that an inference server can remain near 100% GPU utilization across different demand levels, so utilization alone is a weak indicator of remaining capacity.

Recommended signals

  • Request queue depth and queueing delay
  • TTFT and end-to-end p95/p99 latency
  • Request count or arrival rate
  • Output tokens per second and active sequence count
  • Error rate, timeout rate, and overload responses
  • GPU memory, KV-cache occupancy, CPU, and network pressure
  • Replica count, scale-up time, and scale-in stabilization time

Combine a fast scale-out rule (for example, rising queue depth or TTFT) with a slower scale-in rule to avoid oscillation. Set maximum queue age and admission limits so a saturated service fails predictably instead of accumulating unbounded latency.

Google Vertex AI supports autoscaling on CPU utilization, GPU utilization, request count, and queue size. Its documentation warns that scale-to-zero can return HTTP 429 while a model starts and may have endpoint and multi-host limitations. Test those behaviors with your client’s retry policy before enabling scale-to-zero in a user-facing path.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How should you compare cost per token fairly?

Compare total cost at the utilization levels you actually expect, not a published hourly rate or token price in isolation. Include accelerator time, idle replicas, storage, egress, observability, request overhead, and staff or on-call time.

Cost component Managed API or endpoint Self-hosted compute/Kubernetes
Inference capacity Per-token, per-request, or endpoint instance charges Accelerator and host hours, reservations, and spare capacity
Idle and burst capacity May be absorbed by serverless or API pricing; verify quotas and cold-start effects You pay for warm replicas or provision burst headroom
Data movement and storage Endpoint storage, logs, and egress may be separate Model storage, inter-zone traffic, snapshots, and egress are your responsibility
Operations Lower platform labor, but monitoring and application operations remain Engineering, on-call, upgrades, security, and incident labor
Failure and redundancy Service-level options and extra replicas may add cost Multi-zone capacity, spare nodes, and failover capacity add cost

For each candidate, calculate:

fully loaded cost per request = (platform charges + infrastructure + storage/egress + observability + operational labor) / successful requests

Also calculate cost per input token, output token, and completed job when those are the units your product or finance team uses. Run the calculation at low, expected, and peak utilization; a platform that is cheapest at 90% utilization may be wasteful at 10%.

How do security and data residency change the decision?

Security requirements can eliminate an otherwise attractive platform. Confirm where prompts, outputs, logs, model artifacts, and backups are processed and stored. Ask whether provider staff or support systems can access data, how long request data is retained, and whether customer-managed encryption keys are supported.

  • Network path: require private endpoints, VPC or virtual-network integration, firewall policy, and controlled egress when data cannot traverse the public internet.
  • Identity: use workload identities and least-privilege roles for deployment, invocation, model storage, and logging.
  • Isolation: determine whether tenants share hosts, GPUs, or caches and what isolation guarantees apply.
  • Residency: map every region involved in inference, logging, telemetry, support, and disaster recovery.
  • Auditability: retain deployment history, model hashes, access logs, and configuration changes needed for incident and compliance reviews.

Managed services can simplify these controls, but “managed” does not mean compliant by default. Validate the exact endpoint type and region with your security and legal teams.

How do you run a fair inference-platform benchmark?

A benchmark is useful only when candidates run the same model, request mix, software assumptions, and acceptance criteria. Azure’s AI workload guidance recommends baseline benchmarking, load testing to select the platform and SKU, and continuous analysis of bottlenecks.

  1. Freeze configuration. Use the same model version, serving backend, hardware class, region, software versions, tokenizer, precision, and endpoint settings for each candidate.
  2. Build a representative trace. Replay real distributions of prompt length, output length, concurrency, cache hit rate, and request priority. Include normal and peak traffic.
  3. Set pass/fail thresholds first. Define TTFT, inter-token latency, p95/p99 end-to-end latency, throughput, availability, and error-rate limits before viewing results.
  4. Exercise lifecycle events. Measure cold start, scale-out, scale-in, queueing, overload responses, retries, rolling deployment, rollback, node or replica failure, and recovery.
  5. Record complete economics. Capture capacity, idle time, storage, egress, telemetry, support, and engineering labor at low, expected, and peak utilization.
  6. Repeat after changes. Re-run when the model, runtime, hardware, region, autoscaling policy, or traffic distribution changes.

Reject results that use a different model, backend, hardware, prompt mix, or concurrency. They do not predict production performance.

How do AWS, Azure, and Google Cloud map to these choices?

Provider names describe a portfolio, not a single operating model. The same cloud can offer a managed API, managed endpoints, and customer-controlled infrastructure.

What migration and growth plan avoids an expensive rewrite?

Design for portability without pretending every platform is interchangeable. Separate application concerns from inference concerns and make each dependency explicit.

  1. Define an internal inference contract for messages, streaming events, timeouts, retries, token accounting, and error classes.
  2. Store model metadata and immutable artifacts separately from endpoint configuration so you can redeploy the same model elsewhere.
  3. Instrument every request with model version, region, endpoint, queue time, TTFT, output tokens, status, and cost tags.
  4. Keep a fallback model or provider for quota exhaustion and regional failure, with quality and data-policy checks.
  5. Use shadow or mirrored traffic to validate a new endpoint before shifting production requests. Compare quality, latency, errors, and cost.
  6. Set a review trigger for sustained utilization, repeated quota incidents, SLO breaches, or a major model change. These events can justify moving from an API to managed endpoints or from managed endpoints to self-hosting.

What are the most common selection mistakes?

  • Choosing by parameter count: ignores precision, KV cache, token lengths, batching, and concurrency.
  • Scaling on GPU percentage alone: misses queue growth and tail latency.
  • Benchmarking one short prompt: produces optimistic throughput that does not represent production traffic.
  • Ignoring cold starts: makes scale-to-zero appear suitable for a strict interactive SLO.
  • Comparing list prices only: omits idle capacity, egress, telemetry, and on-call labor.
  • Assuming managed means hands-off: application retries, quotas, model updates, security, and SLO monitoring still require owners.
  • Skipping rollback tests: leaves a model or runtime regression without a proven recovery path.
  • Locking into undocumented behavior: makes provider migration difficult when quotas, regions, or model versions change.

Frequently Asked Questions

Can I use more than one inference platform at the same time?

Yes. A common pattern is to keep an interactive workload on a managed endpoint while sending offline or overflow jobs to a batch or self-hosted pool. Use one request contract and enforce consistent privacy, model-version, and quality policies across routes.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How often should an inference capacity plan be revisited?

Revisit it after any material change in model architecture, precision, context length, traffic mix, accelerator class, runtime, or latency SLO. Even without a code change, review capacity when utilization, queueing, or cost trends shift for several weeks.

What should I do if a benchmark passes but production latency is worse?

Compare the production trace with the benchmark for prompt and output lengths, concurrency, retries, cache behavior, and regional network paths. Check queueing and cold-start time first, then verify that autoscaling limits and rollout settings match the tested configuration.

Is scale-to-zero safe for an interactive chatbot?

Only when the application can tolerate startup delay and retry responses such as HTTP 429 while the model loads. Keep a warm minimum or route first requests to another capacity pool when the user-facing SLO is strict.
