Build an AI evaluation suite by turning product goals and risks into testable criteria, assembling a versioned set of representative and difficult cases, and evaluating them with a mix of executable checks, rubric-based model judges, and human review. Run the suite before material changes, then monitor sampled production traces so the same quality standards can catch problems after release. The result should be a reproducible release process—not a single score that claims to measure every aspect of an AI system.

What is an AI evaluation suite, and why does a production system need one?

An AI evaluation suite is a maintained collection of test cases, evaluation methods, thresholds, and run records used to assess an AI system. It tests whether a particular model-and-application configuration meets the product’s quality and risk requirements, both before deployment and while handling real traffic.

Production systems are variable: model outputs can differ, and the behavior users see depends on more than the model. Retrieval, prompts, tool calls, routing, guardrails, retries, and handoffs can all affect the outcome. OpenAI’s evaluation guidance describes evaluations as a way to test an AI system despite that variability. For a deployed application, this means checking the whole path that can produce an answer—not just whether one model response looks plausible.

A useful suite answers concrete operational questions: Does the system follow instructions? Is the answer supported by retrieved material? Did the agent call the right tool with valid arguments? Does it refuse when policy requires it? Has a change worsened latency, cost, or user outcomes? A passing result is meaningful only in relation to the objective and the defined release criteria.

How do you choose objectives and define failure?

Start by specifying what the system must do and what kinds of failure matter. OpenAI recommends defining the evaluation objective before gathering data or choosing metrics. Translate each product requirement into an observable check or score, then determine which failures are severe enough to block release.

Turn product goals into testable criteria

For each workflow, describe the desired behavior in terms an evaluator can observe. “Give a useful answer” is too broad by itself; a testable version might ask whether the answer follows the requested format, uses the relevant evidence, and completes the user’s task. Depending on the application, criteria can include:

  • Factual correctness and whether claims are grounded in supplied evidence.
  • Instruction following, relevance, and completeness.
  • Appropriate refusal behavior and policy compliance.
  • Correct tool selection, arguments, execution, and use of tool results.
  • Task success, latency, token usage, cost, and user or expert satisfaction.

Not every criterion needs the same evaluator. A required output schema can be checked mechanically; whether a response is complete may require a rubric and review. State what counts as a failure, define severity levels, and document which failures block deployment. Set thresholds to reflect the application’s objective and risk rather than borrowing a universal target: there is no single industry threshold that applies across production workloads.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Write criteria so teams can act on a failure

Make each criterion specific enough that a failed result points toward a corrective action. Separate a wrong final answer from a bad retrieval result, an invalid tool call, an unnecessary refusal, or an unsafe completion. For each case, retain the expected behavior or acceptable alternatives and the reason the criterion matters. That gives reviewers a shared basis for labeling and helps engineers determine whether to change the prompt, data, tool handling, or another component.

How do you build a useful evaluation dataset?

Combine expert-authored examples, historical or sampled production traces, user feedback, synthetic edge cases, and adversarial cases. No single source captures all the ways a production workload can succeed or fail. Version the resulting dataset, keep a held-out regression set, and preserve the context needed to interpret every case.

Gather cases from multiple sources

  • Expert-authored examples: represent normal, important workflows and encode domain expectations.
  • Historical or sampled production traces: expose actual user requests and workflow paths, subject to the application’s privacy and data-handling requirements.
  • User feedback: helps identify unsatisfactory outcomes that automatic checks may not capture. MLflow describes attaching feedback to traces with user and timestamp metadata.
  • Synthetic edge cases: add deliberate variations or unusual conditions that may be scarce in routine traffic.
  • Adversarial cases: probe ways the system could violate policy, misread instructions, misuse tools, or produce unsupported claims.

These are complementary inputs, not interchangeable proof. Production examples reflect observed traffic; synthetic and adversarial cases broaden coverage; expert examples establish expected behavior. Record where a case came from so you can interpret what the suite represents and where it may be thin.

Stratify the cases and preserve a held-out set

Organize coverage by factors that can change behavior or risk: user intent, language, geography, customer tier, workflow path, and risk level. A large case count is not useful if the set overrepresents routine requests and misses a consequential workflow. Use these categories to inspect coverage and identify whether a score hides a weak subgroup.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Keep a held-out set for regression testing rather than using every case while refining prompts and evaluators. Store dataset versions and the expected answers, acceptable variants, retrieval references, and labels associated with each case. This makes a result interpretable later: the team can tell which test set was run and what the system was expected to do.

Which evaluators should an AI evaluation suite use?

Match the evaluator to the question. Use deterministic or executable checks for machine-verifiable properties, rubric-based LLM judges for nuanced language judgments, and calibrated human review for high-impact or ambiguous cases. A robust suite combines these methods instead of treating one evaluator as authoritative for every criterion.

Evaluation method Best suited to Important consideration
Deterministic or executable checks Schema validity, function-call arguments, SQL execution, and policy flags Define the expected condition explicitly so a check can return a reproducible result.
Rubric-based LLM judge Nuanced relevance, completeness, style, or groundedness Check judge outputs against human labels for agreement and bias.
Human review High-impact decisions and ambiguous cases; calibration of automated judges Use a shared rubric and review disagreements rather than assuming every judgment is self-evident.

Make model-judge evaluations inspectable

Write a rubric that describes what a passing response does and what failure looks like. A judge prompt should evaluate a named criterion, not issue an open-ended request to decide whether an answer is “good.” Where useful, compare two responses pairwise or ask for a pass/fail decision; OpenAI notes that these formats can be more reliable than unconstrained scoring. Still, an LLM judge is an evaluator to validate, not ground truth. Compare its decisions with human labels and look for systematic disagreement or bias before relying on it for release decisions.

Use human review where the cost of a wrong call is high

Route consequential, unclear, or disputed cases to reviewers who can assess the context and apply the rubric. Human review is also useful for checking whether an automated judge’s labels align with expert judgment. Treat disagreements as useful evidence: they can expose an underspecified criterion, an ambiguous expected answer, or a judge behavior that needs recalibration.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What should you evaluate in an AI application or agent?

Evaluate both individual components and the end-to-end result. Component-level checks help locate a regression; end-to-end cases establish whether users still get the intended outcome. The right coverage depends on the architecture, so trace the actual steps your application can take.

For a single-turn model call

Check instruction following and functional correctness against the objective. Include cases that test the required format, expected content, refusal behavior, and use of supplied context where applicable. A response can satisfy one criterion while failing another, so keep distinct checks for distinct requirements.

For retrieval-augmented generation

Test retrieval quality as well as the answer. Retrieval context precision and recall can help assess whether the system finds relevant material and whether the retrieved context supports the answer. Evaluate groundedness against the references for the case rather than treating a fluent answer as evidence of correctness. Keep retrieval references with the versioned dataset so reviewers can inspect what the system was expected to use.

For workflows and agents

Evaluate each workflow step and the final result. For an agent, inspect the sequence of decisions and actions: tool selection, arguments, routing, handoffs, guardrails, retries, and termination. A trace-level evaluation can reveal which step caused a regression instead of merely recording that the final answer was poor. Test tool-call correctness separately from whether the resulting user-facing task succeeded.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

This component-plus-outcome approach also applies to failures involving guardrails or handoffs. A final answer alone may not show whether the system reached it through the expected route, or whether a control failed before the response was produced. Retain enough trace information to relate an outcome to the steps that generated it.

Which metrics should you track?

Use a portfolio of metrics tied to your objectives rather than relying on one generic score. A useful mix can cover task success, factuality, groundedness, retrieval, safety, tool behavior, operational performance, and user or expert satisfaction.

  • Outcome quality: task success, factuality, relevance, completeness, and instruction following.
  • Evidence use: groundedness and retrieval context precision and recall.
  • Risk controls: safety, refusal behavior, and policy compliance.
  • Workflow execution: tool-call accuracy, routing, handoffs, retries, and termination where relevant.
  • Production operation: latency, token usage, and cost.
  • Experience: user or expert satisfaction.

Microsoft groups evaluation methods into reference-based, reference-free, LLM-based, code, and RAG metrics. Those categories can help organize a portfolio, but metric choice and thresholds still need to reflect the product’s requirements and risk. A latency metric cannot establish factual accuracy, and a groundedness score cannot establish that the workflow completed the user’s task.

How do offline evaluations and online monitoring work together?

Offline evaluation runs a curated suite against a model or application version before release; online evaluation checks sampled live traces and conversations after deployment. Use offline runs as release gates and online monitoring to find regressions and failure patterns that the curated set did not anticipate. MLflow distinguishes offline evaluation on datasets or historical traces from automatic evaluation on live traces and conversations.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Run a release gate before material changes

  1. Identify the change. Run the suite for material changes to prompts, models, retrieval, tools, or application code.
  2. Use the same defined dataset and baseline. Record which dataset and split were used so the results can be compared meaningfully.
  3. Check the relevant criteria. Inspect the aggregate results and the failures that matter to the change, including component behavior and end-to-end outcomes.
  4. Apply the documented release thresholds. Block deployment when a failure meets the team’s predefined blocking condition; do not invent a new threshold after seeing a disappointing result.
  5. Preserve the run record. Keep versions, sample information, results, uncertainty, and representative failures for review and reproduction.

Monitor live traces without delaying user requests

Sample production traces for automatic evaluation and prioritize high-risk or high-value traffic. Route failures to human review according to their severity and the team’s escalation rules. Keep this monitoring asynchronous so quality checks do not block user requests. Sampling controls evaluation cost, while risk-based prioritization helps focus review on traffic where a missed failure matters most.

Online monitoring complements the offline suite; it does not replace it. A live sample can expose new patterns, while the curated regression set makes repeatable comparisons possible. When a production failure reveals a meaningful case, it can inform a later dataset revision, with its origin and labels retained.

Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Support on Ko-Fi

What should every evaluation run record?

Store enough provenance to reproduce and interpret a result. A score without the versions, criteria, and sample behind it is difficult to use as a dependable release record.

  • Evaluation objective and the criteria being tested.
  • Dataset version, split, and sample size.
  • Model and prompt versions.
  • Evaluator and rubric versions.
  • Thresholds and the sampling policy or rate.
  • Aggregate results, confidence or uncertainty, and representative failures.

Treat the suite as code and data: review and version changes, and preserve run artifacts. NIST’s AI 800-2 describes automated benchmark work through protocol design, implementation, execution, debugging, analysis, and reporting. That lifecycle is a practical reminder that benchmark quality depends on how a test is specified and run, not only on the final score.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How can you keep the suite useful as the product changes?

Maintain the suite as part of the product’s operating process. Each meaningful prompt, model, retrieval, tool, or code change should have a corresponding evaluation record, and new failures should be considered for future coverage. Review dataset and rubric changes so that a passing score still means the same thing from one run to the next.

Use failures to improve coverage, not just the current build

For a failed case, inspect the trace and classify where the behavior went wrong: input interpretation, retrieval, tool choice or arguments, routing, guardrails, or final response. Then decide whether the case exposes a defect, an unclear criterion, or a missing test category. Preserve the example and its expected behavior in a versioned dataset when it provides a reusable regression check.

Compare evaluation systems on operational fit

If choosing evaluation infrastructure, compare capabilities that affect the complete workflow: component and end-to-end coverage; deterministic checks, model judges, and human review; dataset and trace versioning; online sampling and alerting; CI/CD and deployment-gate integration; privacy and data residency; latency and cost; reproducibility; and support for agents, RAG, and tool calls. A feature list is less important than whether the system can preserve the context and artifacts your release decisions require.

Frequently Asked Questions

How do I evaluate an AI feature when there is no single correct answer?

Define acceptable variants and observable rubric criteria rather than forcing one reference string. For contested or consequential judgments, compare automated labels with blinded human review and refine the rubric when reviewers cannot apply it consistently.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can I use user thumbs-up and thumbs-down as my evaluation labels?

Treat feedback as a useful signal, not a complete quality label: it can identify traces worth investigating, but it does not by itself explain why an answer succeeded or failed. Preserve feedback with trace context and timestamp, then add an explicit criterion or reviewer label when you need an actionable test case.

How should I decide whether an evaluation failure is severe enough to block a release?

Make the blocking rule part of the objective and risk definition before running the gate. A failure’s severity depends on the consequence in the specific workflow, so document the reason and escalation path rather than applying one cutoff to every metric.

What should I do if an evaluation score improves but users still report problems?

Inspect the underlying cases and the coverage categories before accepting the aggregate result. The score may reflect the tested distribution while a weak intent, language, geography, tier, or workflow path remains underrepresented; turn verified reports into traceable cases for review.
