The AI memory wall is the point where moving model data—not doing calculations—limits inference performance. A GPU can have compute capacity to spare and still be slowed by getting model weights and a growing key/value (KV) cache to the processors quickly enough. That is why adding GPUs alone does not guarantee lower latency: memory capacity, bandwidth, and the connections between components matter too.

What is the AI memory wall?

Processors work on data held in a hierarchy of storage and memory. The memory wall describes the performance gap that appears when computation can proceed faster than the system can supply the required data. In generative AI inference, the issue is especially visible in the movement of weights and attention data between memory and processors.

AI infrastructure discussions treat data movement, memory architecture, and connectivity as design concerns alongside compute. The AI Infra Summit 2026 agenda covers these issues in the context of inference systems and different serving needs.

Why don’t more GPUs automatically fix inference latency?

More GPUs can add compute resources, but they also introduce questions about where model data resides and how it reaches the processors doing the work. If memory capacity or bandwidth, or the interconnect carrying data, is the limiting resource, extra compute may not remove the bottleneck. Depending on the system and workload, distributing work can also make communication and data movement part of the performance equation.

There is no single bottleneck for every model or serving setup. A useful diagnosis starts with the workload: determine whether the constraint is compute, memory capacity, effective bandwidth, communication overhead, or a combination, and distinguish prompt processing from token generation. The agenda identifies memory architecture, connectivity, and differing inference service needs as active design topics, rather than establishing a universal hardware winner.

What uses memory during transformer inference?

Three kinds of demand help explain the problem: persistent model weights, a dynamic KV cache, and transient activations. Their relative importance depends on the model, precision, implementation, and workload.

Model weights

Weights encode the model and must be available as inference proceeds. They are a persistent memory demand: the system needs capacity to hold them and enough bandwidth to supply them as computation uses them.

KV cache

Transformer inference can retain keys and values for tokens in active sequences so they can be used again as generation continues. This KV cache grows with the tokens kept for active requests. Longer contexts and more concurrent requests can therefore raise cache demand.

A 2026 Spheron guide illustrates cache calculations using sequence length and batch size as inputs. Its example is not a universal estimate: actual memory needs vary with model architecture, precision, serving implementation, and workload. See the guide’s KV-cache discussion and example for the assumptions behind its figures.

Transient activations

Activations are intermediate values produced while the model processes input and generates output. They add to memory use, but their size and lifetime depend on how the model is run. Considering weights, cache, and activations separately helps identify what is consuming capacity rather than treating “AI memory” as one undifferentiated quantity.

How does long context affect GPU memory?

As a request retains more tokens, its KV cache can grow. Serving multiple requests at once compounds the demand because each active sequence can require its own retained cache. That makes context length and concurrency important capacity questions, not just user-facing settings.

Longer context does not translate into one fixed memory cost across all models. Architecture, numerical precision, cache policy, and implementation change the calculation. A vendor’s worked example can illustrate the dependencies, but should not be applied as a specification for a different model or serving stack.

Can NVMe storage help with a model’s KV cache?

It can serve as a slower tier for less-active cache entries in some serving architectures, potentially extending the amount of cache data the system can retain beyond what fits in GPU memory. Spheron describes this as an offload approach; it does not make NVMe equivalent to GPU memory or establish a guaranteed latency improvement.

Offloading changes where data lives and adds movement between tiers. Whether it helps depends on which entries are needed, how often they are retrieved, the transfer path, and the workload’s latency requirements. The relevant trade-off is capacity versus the extra time and overhead of fetching data from a slower tier—not simply whether a server has an NVMe drive.

How should you compare inference system options?

No option—more memory, faster memory, a different model or precision, batching, or cache tiering—wins in every case. Compare systems against the actual serving workload and measure the constraints that matter for it.

  • Memory capacity: Can the system fit weights, active cache, and transient working data for the target context and concurrency?
  • Effective bandwidth: How quickly can required data reach the processors during prompt processing and token generation?
  • Latency: Examine prompt-processing and decode latency separately; an optimization may affect them differently.
  • Interconnect and data movement: Account for transfers among processors, memory tiers, and hosts, not just the specifications of an individual component.
  • Workload support: Check the context lengths and concurrent-request levels the system can sustain under the service’s requirements.
  • Cost and power: Compare the total system and operating trade-offs for the performance delivered, rather than compute capacity alone.

Potential approaches include selecting hardware with greater memory capacity or bandwidth, changing model or precision, using batching to increase reuse, and tiering less-active cache data to host memory or NVMe. These are design choices with workload-dependent trade-offs; the available sources do not provide a controlled comparison that ranks them.
