Influence functions can estimate how changing one training example would change a model’s parameters, loss, or prediction without a full retraining run. For large language models (LLMs), however, that estimate is usually too approximate to serve as a causal explanation of why a model generalizes. The most recent systematic evaluation found poor performance in most tested LLM settings. Influence analysis remains useful as a debugging lead when its rankings are checked against an observable intervention such as leave-one-out retraining or targeted fine-tuning.

The practical question is therefore not whether an influence score is “true,” but whether it predicts a behavioral change under a clearly defined distribution shift.

What do influence functions estimate?

Influence functions come from robust statistics and optimization. They approximate the effect of upweighting, removing, or editing one training example while keeping the rest of the training set and procedure fixed. Instead of training the model again for every example, the method uses local curvature around the fitted parameters.

Let θ denote the trained parameters, z one training example, and z_test an evaluation example. A common influence estimate has the form -∇θL(z_test, θ)T H-1 ∇θL(z, θ), where H is the Hessian of the training loss. The gradients describe how each example pushes the parameters; the inverse Hessian describes how those pushes are transformed by the local geometry of the loss surface.

A positive or negative score is therefore a local, model-specific estimate. It is not a count of how often a passage was memorized, a proof that an example caused an answer, or a direct measurement of human-like reasoning. The estimate also depends on the intervention: upweighting an example, deleting it, editing its label, and taking a few gradient steps are different questions.

Why is influence-function analysis difficult for LLMs?

Three technical problems dominate LLM-scale use: computing an inverse-Hessian-vector product (iHVP), meeting optimization assumptions during fine-tuning, and connecting parameter changes to observable behavior.

How does the iHVP become the bottleneck?

The Hessian has a dimension equal to the number of model parameters, so explicitly forming and inverting it is infeasible for modern LLMs. Implementations instead estimate the product H-1v with approximations, stochastic procedures, or structured curvature models. The 2023 study Studying Large Language Model Generalization with Influence Functions used EK-FAC approximations to make the computation tractable, while explicitly identifying iHVP computation as the scaling bottleneck.

Approximation error can change the ordering of examples, especially when scores are close. A ranking that looks precise to several decimal places may not be stable under a different damping value, minibatch order, checkpoint, or curvature approximation. Any report should therefore state the approximation method and stability checks rather than presenting scores as exact quantities.

Which training assumptions are hard to satisfy?

Classical influence theory is most comfortable with smooth objectives, a well-behaved local optimum, and a small perturbation around a stable solution. LLM fine-tuning is non-convex, often uses adaptive optimizers, schedules, regularization, early stopping, and large parameter updates. The 2023 NeurIPS analysis Theoretical and Practical Perspectives on what Influence Functions Do examined five assumptions involving convexity, numerical stability, the training trajectory, and parameter divergence. Its conclusion was not that every estimate is useless, but that the assumptions must be treated as empirical questions.

Why are parameter influence and behavioral influence different?

An example can produce a measurable parameter displacement without changing the token probabilities or task output that a user sees. Conversely, a small parameter change can cross a decision boundary and alter a prediction. The 2025 Findings of EMNLP paper Do Influence Functions Work on Large Language Models? identifies this mismatch as a fundamental reason that a parameter-level score may fail to predict LLM behavior.

Does influence fade as training proceeds?

The NeurIPS analysis reports that influence fades over training time even with deterministic training. Later updates can overwrite or dilute the local effect of an early example, so an influence estimate taken at the final checkpoint may not preserve the example’s historical role. This limits claims that a high-scoring example is a permanent explanation of a model capability.

Can influence functions explain which examples make an LLM generalize?

Usually not by themselves. They can nominate examples associated with a test loss or prediction, but explaining generalization requires a defined shift and a behavioral validation that the nominated examples actually matter under that shift.

What counts as “generalization” here?

Generalization is not one scalar property. A model may transfer across topics, domains, languages, task formats, or environments; each tests a different capability. The Nature Machine Intelligence taxonomy reviewed 752 generalization experiments from 543 ACL papers and classified them by motivation, generalization type, data-shift type, shift source, and shift locus. An influence study that does not name its shift cannot support a broad claim about generalization.

Why should architecture and data scale be separated?

A systematic syntactic study evaluated 20 model-and-data-size combinations across 34 English syntactic test suites. In those experiments, architecture-related variation in syntactic generalization was substantially larger than variation caused by dataset size. If an influence ranking changes when architecture or objective changes, attributing the result to parameter count alone is not justified.

The strongest current conclusion is cautious: influence functions perform poorly in most evaluated LLM settings, but targeted influence can still help locate data for debugging when the proposed effect is verified.

How should you test an influence claim?

A defensible study starts with the intervention and ends with an observable behavior. The following workflow keeps the claim narrower than the mathematics often suggests.

  1. Define the intervention. State whether the claim concerns upweighting, deleting, editing, or taking a specified number of fine-tuning steps on an example. Record the checkpoint, optimizer, learning rate, batch construction, and stopping rule.
  2. Define the shift. Name the source and locus of the shift: for example, a new domain, language, topic, syntax pattern, task format, or environment. Use a held-out evaluation set that represents that shift rather than relying only on the training loss.
  3. Compute scores with an explicit approximation. Document EK-FAC or another iHVP method, damping, stochastic estimates, precision, and memory limits. Recompute under small numerical changes to see whether the top-ranked examples remain stable.
  4. Check optimization behavior. Monitor loss, gradient norms, and convergence during the fine-tuning regime. If the run has not settled or diverges from the reference trajectory, treat the influence approximation as exploratory.
  5. Test parameter and output effects separately. Measure parameter displacement or loss change, then measure token probabilities, exact predictions, calibration, or task scores. A parameter effect without a behavioral effect does not establish a user-visible cause.
  6. Validate with a behavioral intervention. Compare the prediction from the influence score with leave-one-out retraining, a small controlled deletion set, or targeted fine-tuning. Use matched low-score examples as controls so that improvement cannot be attributed merely to adding more data.
  7. Report uncertainty and scope. Give the model size, fine-tuning regime, shift definition, approximation, validation protocol, and the fraction of cases in which the ranking predicted the observed change. Avoid extending a result from one task or checkpoint to LLM generalization in general.

When are influence functions still useful?

Data debugging

Influence rankings can prioritize examples for inspection when a model makes a repeatable error. An engineer can examine high positive-influence examples for mislabeled targets, duplicated text, leakage, formatting artifacts, or a narrow subpopulation. The ranking saves review time, but the diagnosis is complete only after removing, correcting, or reweighting a small set and checking whether the error changes.

Targeted correction

The NeurIPS 2023 experiments found that a few fine-tuning steps on influential examples could correct some mispredictions in NLP and vision settings. This is a narrower claim than “the examples explain generalization”: it says that selected examples can be useful control points for a particular error under a particular update procedure.

Dataset triage before an expensive run

Influence estimates can help choose which records deserve expensive human review or ablation first. Use them as a prioritization layer alongside duplicates, uncertainty, slice performance, and nearest-neighbor analysis rather than as the sole data-quality metric.

What evidence should complement influence scores?

Compression-based bounds

The ICML 2024 work on non-vacuous generalization bounds combines prediction smoothing with SubLoRA, a compressed low-dimensional parameterization. Its subsampling extension made bound computation 900 times faster, and experiments covered models with up to 849 million parameters. The reported finding that larger models had better bounds and were more compressible is evidence under that method’s assumptions; it does not prove that a model will transfer to every real-world distribution.

Explicit distribution-shift evaluations

Build test sets that vary the shift source and locus, then report results by slice. A model that transfers across topics may fail across task formats; a syntactic suite may reveal behavior hidden by aggregate benchmark accuracy. The taxonomy of generalization experiments is useful precisely because it prevents these shifts from being treated as interchangeable.

Human-centered evaluations

Human expectations can diverge from benchmark rankings. The ICML 2024 study’s 19,000 judgments across 79 MMLU and BIG-Bench tasks found cases where more capable models performed worse on examples people selected when errors were costly. If the intended system supports consequential decisions, include judgments or task choices that reflect how people will actually use it.

How should you interpret an influence score in a report?

Use language that matches the evidence. “The score predicts a larger loss change under our deletion test” is testable. “This example caused the model to learn the concept” is usually too strong unless a controlled behavioral intervention supports it.

Do not compare raw scores across models, tasks, or curvature implementations unless the study establishes that the scales are comparable. Rankings are often more interpretable than magnitudes, but even rankings can be unstable when approximation error is large.

What are the main failure modes and fixes?

Failure mode Why it misleads Practical response
Calling a parameter score causal Parameter movement may not change outputs Run a deletion, reweighting, or targeted-update test and report behavioral metrics
Ignoring iHVP approximation error Curvature errors can reorder examples Document the approximation, vary numerical settings, and report ranking stability
Assuming convergence Non-converged fine-tuning breaks local assumptions Show optimization diagnostics and restrict claims to the tested regime
Mixing shift types Topic, language, syntax, format, and environment transfer are different Define the shift source and locus and score slices separately
Blaming scale alone Architecture effects can exceed data-size effects in syntactic tests Compare architecture, objective, and data size together
Using benchmark accuracy as the whole story People may choose high-cost cases where model behavior diverges from expectations Add human-centered judgments or usage-based evaluations

What is the practical verdict for LLM generalization research?

Influence functions are best treated as approximate diagnostic instruments, not an explanation engine for LLM generalization. Their iHVP calculations are difficult at scale, their optimization assumptions are fragile, and parameter influence does not reliably predict behavior. Use them to generate a small, testable set of data hypotheses; validate those hypotheses with controlled behavioral interventions; and pair the result with explicit shift evaluations, compression-based bounds, and human-centered evidence.

Frequently Asked Questions

What is an inverse-Hessian-vector product in plain language?

It is a way to estimate how a proposed gradient change would be transformed by the local curvature of the loss surface without constructing the full Hessian matrix. In an influence calculation, that estimate links one training example’s gradient to its predicted effect on another example’s loss.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can deleting one training example prove that it caused a model output?

No. A deletion experiment can show that the output changes when the example is removed, but the change may result from redundancy, optimization noise, or interactions with other records. Stronger causal evidence requires controlled comparisons and repeated runs under the same training procedure.

Which generalization shifts should an LLM evaluation include?

Choose shifts that match the intended use, such as domain, language, topic, syntax, task format, or environment changes. Report each shift separately because success on one does not establish transfer on another.

Are non-vacuous generalization bounds guarantees about deployment performance?

They are guarantees conditional on the bound’s assumptions, parameterization, smoothing procedure, and data relationship. They complement distribution-shift tests but cannot replace measurements on the populations and tasks where the model will be used.
