To run an AI workload on a Google Cloud TPU, first confirm that the model maps well to XLA-compiled tensor operations, then create a TPU VM in a supported region, install a compatible framework such as JAX, run a small validation job, and only then choose a larger slice or serving setup. TPUs are cloud resources rather than devices you plug into a workstation. Your project needs billing, API access, IAM permissions, quota, and available capacity. Google’s current quickstart uses an on-demand TPU v6e (Trillium) VM, SSH, Ubuntu, and JAX; its machine type and zone are examples, not universal recommendations. TPU versions, prices, supported frameworks, and capacity change, so verify the live Google Cloud documentation immediately before provisioning.

What is a Cloud TPU, and which workloads fit it?

A Cloud TPU is a Google-designed ASIC for machine-learning computation. You provision it as a cloud VM or TPU slice and run framework code remotely. The TPU host uses the accelerated linear algebra (XLA) compiler to turn supported framework graphs into TPU machine code. Google states: “Code that runs on TPUs must be compiled by the accelerated linear algebra (XLA) compiler.”

TPUs are strongest when most of the work consists of large, regular matrix operations and the effective batch size is large enough to keep the accelerator busy. They are less attractive when the training loop is dominated by Python branching, irregular control flow, many elementwise operations, high-precision arithmetic, or custom operations that do not map cleanly to the supported compiler and runtime. Input preprocessing, host-side work, storage, and networking can also become bottlenecks even when the model itself is TPU-friendly.

Workload signal What it means for TPU suitability
Large matrix multiplications, convolutions, or transformer blocks Usually a strong fit because these operations can be compiled and parallelized efficiently.
Large effective batches and long, repetitive training steps Often favorable; fixed-shape, high-throughput work gives compilation and device utilization time to pay off.
Frequent branching or highly dynamic shapes Requires careful testing; recompilation or host execution can reduce throughput.
Many custom kernels or unsupported operators Potentially poor fit. The workload may fail during compilation or leave expensive work on the host.
High-precision arithmetic as the central requirement Check numeric support and model accuracy before committing to a TPU configuration.
Small, irregular jobs with little repeated computation Benchmark first. Compilation and startup overhead can outweigh accelerator benefits.

Framework compatibility is part of workload fit. A model that runs on a GPU is not automatically ready for a TPU: its operators, shapes, precision settings, input pipeline, and distributed strategy all need to be supported by the selected framework runtime.

What must be ready before creating a TPU VM?

Prepare the Google Cloud project and check capacity before you write a creation command. A successful API request still depends on quota and a TPU version and zone that have capacity for your project.

  • Project and billing: choose the project that will own the VM, confirm that billing is enabled, and identify who is responsible for deleting resources after testing.
  • Google Cloud CLI: install and initialize the current gcloud CLI, select the project, and authenticate with an account allowed to create Compute Engine resources and use the required service accounts.
  • API access: enable the Compute Engine API if it is not already enabled. Your organization may use custom IAM roles, but they must provide the equivalent permissions for project or instance administration, service-account use, and service usage.
  • TPU quota: check quota for the TPU version, accelerator count, and region you intend to use. A project can have quota in one location but not another.
  • Regional availability: confirm that the exact TPU version, machine type, image or runtime, and consumption model are offered in the target zone at launch time.
  • Software plan: decide whether you will use JAX, PyTorch, or another supported stack, and record the versions you will pin for a reproducible environment.
  • Data path: identify where datasets and checkpoints live and how the VM will access them. Keep data transfer and host-side preprocessing from becoming the hidden bottleneck.

Do not treat a machine type shown in a quickstart as a capacity guarantee. Google’s examples are documentation paths; your project’s quota, organization policy, region, and current inventory determine whether the request succeeds.

How do I create and connect to a TPU VM?

The following sequence mirrors Google’s current TPU v6e quickstart. It creates an on-demand VM, uses an Ubuntu accelerator image, and connects with SSH. Replace the project, machine type, zone, image family, and consumption model after checking current availability.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Select a project and location. Set the project in the Cloud Console or CLI, then verify quota and TPU capacity for the zone. The quickstart example uses europe-west4-a; that location is illustrative rather than a global default.
  2. Create the VM. Run the example command below from an authenticated shell:
    gcloud compute instances create quickstart-tpu
      --machine-type=ct6e-standard-4t
      --zone=europe-west4-a
      --image-project=ubuntu-os-accelerator-images
      --image-family=ubuntu-accel-2204-amd64-tpu-v5e-v5p-v6e
      --maintenance-policy=TERMINATE

ct6e-standard-4t is the v6e example used by the quickstart. Do not assume that this size, image family, or zone is available to your project, or that it is appropriate for your model.

  3. Connect over SSH.
    gcloud compute ssh quickstart-tpu --zone=europe-west4-a

If the command fails, check that the instance finished provisioning, your account has OS Login or equivalent SSH permissions, and organization policies permit the connection method.

  4. Confirm the host environment. Record the operating-system image, Python version, accelerator runtime, and attached TPU identity before installing packages. Keeping this information with your experiment makes later failures easier to reproduce.
  5. Stop or delete test resources. A terminated maintenance policy does not replace deliberate cleanup. Stop or delete the VM when a test is complete, and remove unused disks or other attached resources according to your project’s policy.

How do I install a framework and verify that the TPU works?

Install the framework version that matches the TPU runtime and your model. Google’s quickstart installs JAX with the TPU-compatible package index below:

Run a minimal device-discovery and matrix operation before cloning a full training repository. This separates cloud, runtime, and compilation problems from model-code problems:

python - <<'PY'
import jax
import jax.numpy as jnp

print('JAX devices:', jax.devices())
x = jnp.ones((2048, 2048), dtype=jnp.float32)
y = x @ x
print('Result shape:', y.shape)
print('Result device:', y.device)
PY

The first execution can include compilation overhead. A visible TPU device and a completed operation establish only basic compatibility; they do not prove that the production model will scale efficiently.

What should the validation run measure?

  • Compilation behavior: note whether the model compiles once for stable shapes or repeatedly recompiles because shapes or control flow change.
  • Device placement: confirm that the expensive model operations execute on the TPU rather than silently falling back to the host.
  • Input pipeline time: measure time spent reading, decoding, and transferring batches. A fast TPU can be idle while the host prepares data.
  • Numerical results: compare loss, accuracy, or generated output with a trusted baseline. Precision changes and unsupported operations can produce incorrect results even when the job runs.
  • Step throughput: benchmark enough repeated steps to exclude one-time startup and compilation costs, then compare cost per useful training step rather than raw device speed.

Which TPU capacity option should I choose?

Google describes four broad consumption choices. The right one depends on interruption tolerance, required duration, capacity certainty, quota, and whether the selected TPU generation supports the option in your region.

Option Best suited to Main trade-off Checks before launch
On-demand Interactive development, benchmarks, and jobs that need standard pay-as-you-go capacity. Usually the simplest path, but it does not guarantee that every version and zone will have immediate capacity. Current price, quota, zone capacity, and runtime support.
Spot Interruption-tolerant training, batch processing, and experiments with reliable checkpoint and restart logic. Google can preempt the resource, so progress can be lost between checkpoints. Preemption handling, checkpoint frequency, restart automation, and supported TPU versions.
Flex-start Shorter or dynamically provisioned runs that can wait for capacity; Google describes requests for up to seven days. Capacity is not necessarily immediate, and the request window and supported resources must be respected. Request duration, version and zone support, quota, and the operational effect of delayed start.
Reservation Planned workloads that need capacity for a specified duration and stronger availability assurances. You commit to reservation terms and should avoid paying for idle capacity. Reservation duration, eligible TPU versions, region, minimums, pricing, and cancellation rules.

Compare total job cost, not just the hourly accelerator rate. Include idle time while waiting for capacity, compilation and warm-up, host resources, storage, data transfer, retries after interruption, and the engineering cost of maintaining checkpoints. A lower nominal rate is not a saving if preemptions repeatedly restart an expensive job.

How should I run training on a TPU?

Start with one small, representative training run. Keep tensor shapes stable, make the input pipeline observable, and save checkpoints to durable storage rather than relying on the VM’s local state.

  1. Port the model through a supported framework. Replace or isolate unsupported custom operations, then verify that the framework’s TPU backend recognizes every major layer.
  2. Choose a realistic batch strategy. Use per-device and global batch sizes that fit memory while providing enough matrix work to keep the TPU occupied. If the model cannot use a useful batch, benchmark before scaling.
  3. Compile with representative shapes. Feed the same sequence lengths, image dimensions, or padding policy used in production. Shape changes can trigger additional compilation and distort timing.
  4. Instrument host and device time separately. Log data loading, transfer, compilation, step execution, checkpointing, and evaluation. This reveals whether the accelerator or the surrounding pipeline limits throughput.
  5. Checkpoint for the chosen capacity model. Spot jobs need restart-safe checkpoints; long on-demand jobs benefit from them as protection against maintenance or application failure.
  6. Scale only after validation. Increase accelerator size or move to a multi-host slice after correctness and single-host throughput are established.

For independent single-host jobs, Compute Engine managed instance groups can manage multiple TPU VMs. That pattern is different from a distributed workload in which several hosts cooperate on one model.

How do TPU slices and multi-host jobs differ from single-host VMs?

A single-host TPU VM is easier to debug because one host owns the workload. A multi-host slice is appropriate when one model or training job must distribute computation across interconnected hosts, but it adds communication, topology, launch, and failure considerations.

Topology Use it when Operational concerns
Single host The model fits on one TPU host and you want the shortest path to development, inference, or a self-contained training run. Host input throughput, local memory limits, and single-resource failure domain.
Multiple independent TPU VMs You have separate jobs that can run independently and can be managed as a fleet. Scheduling, per-VM cleanup, quota across instances, and consistent software images.
Interconnected multi-host slice One distributed workload needs more accelerator capacity than a single host provides. Distributed initialization, network collectives, synchronized checkpoints, matching software across hosts, and coordinated recovery.

Do not assume that adding hosts produces linear speedup. Communication, synchronization, input delivery, and checkpoint writes can dominate as the slice grows. Use the workload-specific distributed guide for the TPU generation you selected.

Can I serve inference on a Cloud TPU?

Yes. Google’s inference documentation states that TPU v5e and later support inference. The serving guidance focuses on single-host TPU deployments and names vLLM and SGLang with JAX or PyTorch backends. Serving capacity, model support, and setup requirements still depend on the TPU version, zone, quota, and framework combination.

How do I choose an inference stack?

  • Model and backend support: confirm that the model architecture, operators, tokenizer path, precision, and requested backend are supported.
  • Latency target: benchmark end-to-end latency, including request batching, tokenization, host-to-device transfer, and response streaming.
  • Throughput target: test concurrent requests and batch sizes representative of production traffic rather than relying on a single-request result.
  • Host count: begin with a single host where possible. Move to a larger topology only when memory or throughput requirements justify the added operational complexity.
  • Capacity model: use a consumption option that matches uptime requirements; a preemptible choice is risky for an always-on endpoint unless failover is designed.

Inference is a separate validation track from training. A model that trains successfully may still need serving-specific conversion, batching, memory, and latency work.

What commonly goes wrong, and how can I recover?

Creation fails with quota or capacity errors

Check the exact TPU version, machine type, accelerator count, project quota, and zone. Try another supported zone or consumption model only after confirming that the framework and image support it. Do not repeatedly submit identical requests without checking whether the project or organization has a regional limit.

The framework does not list a TPU

Confirm that the TPU-compatible runtime and framework package are installed inside the VM where the command runs. Check Python and package versions, inspect the device list, and compare the selected image family with the TPU generation. Installing a generic CPU-only package can leave the code apparently functional while bypassing the accelerator.

Compilation fails on a model operation

Identify the first unsupported or dynamically shaped operation in the compiler output. Simplify the operation, replace it with a supported framework primitive, or move genuinely host-only work outside the compiled step. If custom code is central to the model, benchmark an alternative accelerator before redesigning the training loop.

The TPU is slower than expected

Separate compile time from steady-state step time, then profile input loading, host computation, synchronization, and checkpointing. Increase useful work per step only within memory and convergence limits, stabilize shapes, and verify that the device is not waiting for the host. A larger TPU does not fix an input pipeline that cannot supply batches quickly enough.

A Spot job is repeatedly losing progress

Increase checkpoint reliability, make restart logic automatic, and estimate the expected wasted work between checkpoints. If interruptions still dominate the wall-clock schedule, compare the total cost and completion risk with on-demand, Flex-start, or a reservation.

How should I plan cost and cleanup?

No single TPU price or “best” machine type applies to every project. Prices and capacity are region-, version-, and consumption-model dependent, and they can change. Obtain the current price for the exact TPU resource and include the VM host, persistent storage, snapshots, networking, logging, and any idle period in your estimate.

Before starting a long run, define a maximum budget and an automatic stop or deletion policy that your organization permits. Tag or label resources by experiment, record the TPU version and zone, and keep checkpoints in durable storage. After the run, delete the VM and review disks, reserved capacity, and other attached resources so a completed experiment does not continue accruing charges.

What is a safe launch checklist?

  • Model operators, shapes, precision, and custom code have been tested with the selected framework backend.
  • Billing, project selection, Compute Engine API, IAM, service-account use, and TPU quota are confirmed.
  • The TPU version, machine type, zone, image, and consumption model have current capacity and compatibility.
  • A small device-discovery and matrix test succeeds before the full model is installed.
  • Framework and runtime versions are pinned and recorded.
  • Input throughput, compilation time, steady-state steps, device placement, and numerical results are measured.
  • Checkpoints and restart behavior match the interruption risk of the chosen capacity option.
  • Training and inference requirements are evaluated separately.
  • Monitoring, maintenance handling, budget limits, and resource cleanup are documented.

Use the smallest representative run that can answer compatibility and performance questions, then scale the TPU version, host count, or serving capacity only when its measurements justify the additional cost and operational complexity.

Frequently Asked Questions

Can I use a Cloud TPU without owning specialized hardware?

Yes. The TPU is provisioned in Google Cloud and accessed through the VM, command line, APIs, or serving stack. Your local computer is mainly a client for administration, code transfer, and monitoring; the accelerator executes in the selected Google Cloud region.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What if my model contains a custom CUDA kernel?

A CUDA-specific kernel cannot be assumed to run on a TPU. Replace it with a supported framework operation or TPU-compatible implementation, then rerun correctness and performance tests before deciding whether porting effort is worthwhile.

How can I compare TPU and GPU results fairly?

Use the same model revision, data pipeline, batch semantics, precision target, and convergence criterion. Compare useful completed work and total cost, including compilation, retries, host time, and checkpoint overhead, rather than comparing only peak device throughput.

Do TPU versions have identical software support?

No. Framework releases, operator coverage, serving tools, image families, quota, and capacity can differ by TPU generation. Verify the exact version and region combination in the current Google Cloud documentation before freezing an environment.
