Use quantization to store model weights at 8-bit, 4-bit, or another lower precision, then load the compressed checkpoint with a compatible runtime. A 70-billion-parameter Llama 2 model documented by Hugging Face needs 256 GB in full precision and 128 GB in half precision; Mistral-7B-v0.1 is documented at 13.74 GB in BF16 and 6.87 GB in 8-bit. Quantization can therefore make a model fit on a smaller GPU, but the final peak still depends on the KV cache, context length, batch size, temporary buffers, and any CPU offload.

What quantization changes

Neural-network weights are normally stored as floating-point numbers such as FP32 or BF16. Quantization represents those values with fewer bits. Hugging Face defines it as reducing the size of model weights by storing them in a lower precision. NVIDIA describes the broader operation as converting weights and, in some systems, activations from formats such as BF16 to INT8, FP8, or FP4.

The immediate benefit is lower weight memory. A model with fewer bytes per parameter leaves more VRAM for the things that appear only while the model is running: activations, attention key-value (KV) cache, tokenizer and runtime buffers, CUDA workspace, and the allocator’s safety margin. The costs are possible quality loss, different latency, limited kernel support, and additional setup.

Weight memory is not the same as peak VRAM

A checkpoint’s file size or estimated weight memory is only the first part of the calculation. During generation, KV-cache memory grows with context length and batch size. Long prompts, many simultaneous requests, beam search, and large output windows can make a model that loads successfully run out of memory later. Leave headroom rather than sizing a card to the exact weight total.

Llama 2, 70 billion parameters, half precision 128 GB Hugging Face documentation, accessed in 2026

Mistral-7B-v0.1, 8-bit 6.87 GB Hugging Face documentation, accessed in 2026

These values illustrate the approximate relationship between bytes per weight; they are not guarantees for every loader. Quantized formats add scale factors, zero points, padding, metadata, and temporary workspaces, so a nominal “four bits per parameter” model does not consume exactly one half of a measured 8-bit run.

Estimate whether a quantized model will fit

Start with a lower bound for the weights, then budget runtime overhead. The simple estimate is:

weight memory ≈ parameter count × bytes per parameter

  • FP32 uses about four bytes per parameter.
  • BF16 or FP16 uses about two bytes per parameter.
  • INT8 uses about one byte per parameter before metadata and runtime overhead.
  • INT4 uses about half a byte per parameter before metadata and runtime overhead.

For a rough planning example, a 7-billion-parameter model at one byte per parameter has a theoretical weight floor near 7 GB, which is consistent with the documented 6.87 GB 8-bit figure for Mistral-7B-v0.1 once model-specific accounting is applied. A 4-bit representation has a theoretical floor near 3.5 GB for the same parameter count, but the actual allocation can be higher.

Add the runtime budget

  • KV cache: grows as the prompt and generated context grow. A short test prompt can understate production usage.
  • Activations: increase with sequence length and batch size, and may remain in a higher-precision compute type.
  • Temporary buffers and kernels: fused attention, dequantization, and matrix multiplication kernels reserve workspace.
  • Tokenizer and framework memory: Python, CUDA, model objects, and allocator fragmentation consume additional VRAM.
  • Safety margin: reserve capacity for variation between runs instead of targeting 100 percent utilization.

Measure peak allocation at the intended context length and concurrency. A model that merely passes loading is not necessarily deployable.

Choose 8-bit or 4-bit

Decision factor 8-bit 4-bit
Weight footprint Roughly half of BF16 weight storage in the documented Mistral example Generally smaller than 8-bit, leaving room for larger models or longer context
Quality risk Usually the less aggressive change; validate on the target task More potential quantization error; NF4, AWQ, and GPTQ use different methods to reduce it
Speed Depends on available INT8 kernels and the GPU Fused kernels can be fast, but dequantization or unsupported kernels can erase the advantage
Compatibility Widely available through supported Transformers backends Backend, GPU, operating-system, and checkpoint-format support varies more
Best first attempt When the model fits with modest savings and quality margin matters When 8-bit still exceeds VRAM or a tested 4-bit checkpoint is available

Use the least aggressive format that meets your memory target. A smaller quantized model is not automatically faster: throughput depends on kernels, memory bandwidth, batch size, and whether layers are repeatedly dequantized.

Load an 8-bit or 4-bit model with Transformers

The common Transformers path uses transformers, accelerate, and bitsandbytes. Install versions compatible with your operating system, CUDA stack, GPU, and model card.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
pip install -U transformers accelerate bitsandbytes

Then pass a quantization configuration to from_pretrained. The following patterns let Accelerate place modules automatically:

8-bit loading

from transformers import AutoModelForCausalLM, AutoTokenizer, BitsAndBytesConfig

model_id = 'your-model-id'
quantization_config = BitsAndBytesConfig(load_in_8bit=True)

tokenizer = AutoTokenizer.from_pretrained(model_id)
model = AutoModelForCausalLM.from_pretrained(
    model_id,
    quantization_config=quantization_config,
    device_map='auto'
)

This is the conservative starting point when the unquantized model is too large but an 8-bit footprint should fit. Confirm that the selected checkpoint and your GPU are supported by the installed bitsandbytes backend.

4-bit loading

from transformers import AutoModelForCausalLM, AutoTokenizer, BitsAndBytesConfig
import torch

model_id = 'your-model-id'
quantization_config = BitsAndBytesConfig(
    load_in_4bit=True,
    bnb_4bit_quant_type='nf4',
    bnb_4bit_compute_dtype=torch.bfloat16
)

tokenizer = AutoTokenizer.from_pretrained(model_id)
model = AutoModelForCausalLM.from_pretrained(
    model_id,
    quantization_config=quantization_config,
    device_map='auto'
)

NF4 is a 4-bit option designed for normally distributed neural-network weights. The compute type in this example is BF16; choose a compute type your GPU and software stack actually support. Storage precision and compute precision are separate choices.

Keep generation memory under control

Quantizing weights does not quantize every runtime allocation automatically. Set a realistic maximum input and output length, avoid unnecessary batch growth, and monitor the KV cache. If your application accepts arbitrary long prompts, test the longest supported context rather than only a short sample.

Use pre-quantized AWQ or GPTQ checkpoints

AWQ and GPTQ are importance-aware or calibration-based approaches that try to preserve the values most important to model output while reducing precision. They are useful when a ready-made checkpoint matches your architecture and runtime. Pre-quantized files usually require less preparation than quantizing locally, but the checkpoint must match the loader, model revision, and GPU kernels.

When AWQ is a good fit

  • You have a backend with fused AWQ kernels for your GPU.
  • The model publisher provides an AWQ checkpoint for the exact architecture and tokenizer.
  • You need a compact deployment and can benchmark the available kernel rather than assuming the smallest file is fastest.

When GPTQ is a good fit

  • A compatible GPTQ checkpoint already exists and avoids a local calibration run.
  • You can use the intended GPTQ loader and verify generation quality on representative prompts.
  • You need a lower-bit option but want a method with published calibration-based experiments.

In reported GPTQ experiments from IST-DASLab, 175 billion parameters were quantized to 3 or 4 bits in approximately four GPU hours, with negligible accuracy degradation relative to the uncompressed baseline. That is a research measurement for the stated experiments, not a universal time or quality guarantee for another model, dataset, GPU, or calibration set.

Quantize a model offline when no suitable checkpoint exists

Offline quantization gives you control over calibration data, bit width, group settings, and the output format. It also requires temporary storage for the original model, a calibration corpus, GPU time, and a validation plan.

  1. Confirm architecture support. Check the quantizer and target runtime documentation for the model family, attention implementation, and required GPU compute capability.
  2. Select representative calibration text. Include the languages, document lengths, code, or domain terminology your application actually uses. Calibration that does not resemble production can preserve the wrong activations.
  3. Choose the target format. Compare 8-bit, NF4, AWQ, or GPTQ according to available kernels and quality requirements, not only file size.
  4. Run the quantizer. Keep the original checkpoint until the output loads and passes evaluation. Record the quantizer version and settings with the artifact.
  5. Evaluate before deployment. Compare task accuracy, refusal or safety behavior where relevant, tokens per second, first-token latency, peak VRAM, and failures at the intended context and batch sizes.

Offload layers to system RAM when VRAM is still insufficient

CPU offload can make a model load when no single GPU has enough VRAM. The trade-off is lower and less predictable speed because data must cross the CPU-GPU link. Hugging Face documents 8-bit CPU offload; offloaded weights remain in float32 on the CPU, so system RAM requirements can be much larger than the quantized GPU portion.

What to budget

  • System RAM: enough for the offloaded float32 weights plus the operating system and application.
  • Transfer bandwidth: PCIe and memory traffic can dominate latency when layers move frequently.
  • Placement stability: automatic mapping may leave a layout that loads but performs poorly; inspect the resulting device map.
  • Failure behavior: insufficient RAM can trigger swapping or process termination even when VRAM usage looks safe.

Enable documented 8-bit offload

from transformers import AutoModelForCausalLM, BitsAndBytesConfig

quantization_config = BitsAndBytesConfig(
    load_in_8bit=True,
    llm_int8_enable_fp32_cpu_offload=True
)

model = AutoModelForCausalLM.from_pretrained(
    'your-model-id',
    quantization_config=quantization_config,
    device_map='auto'
)

Use this only after checking the current backend instructions. If automatic placement produces excessive transfers, provide an explicit device map or reduce the context and batch size. Offloading is a capacity workaround, not a substitute for adequate GPU memory when low latency is required.

Use TensorRT-LLM for NVIDIA production inference

For NVIDIA deployments, TensorRT-LLM documents FP4, FP8, W4A16 and W4A8 AWQ, and W4A16 and W4A8 GPTQ. It supports loading pre-quantized models and offline quantization through NVIDIA Model Optimizer. These options can provide optimized kernels and production-oriented execution, but they impose stricter model, GPU, and build compatibility checks than a general-purpose Python loader.

  1. Identify the target GPU and TensorRT-LLM release. Confirm that the precision mode and kernels are supported together.
  2. Choose a pre-quantized artifact or quantize offline. A pre-quantized model reduces preparation; offline quantization gives control over calibration and settings.
  3. Build the engine for the deployment shape. Account for maximum sequence length, batch size, and number of concurrent requests when sizing workspace and KV cache.
  4. Benchmark the built engine. Record first-token latency, steady-state tokens per second, peak VRAM, and quality on the same prompts used by the unquantized reference.

Vendor-specific kernels can change the speed ranking. Do not infer performance from bit width alone.

Quality checks

  • Exact-match or numeric scoring for tasks with objective answers.
  • Human or rubric-based review for writing, summarization, extraction, and instruction following.
  • Long-context tests that reach the production limit.
  • Multilingual, code, or domain-specific prompts if those are part of the service.
  • Regression checks for formatting, tool calls, refusal behavior, and stop-token handling.

Performance checks

  • Peak VRAM: capture loading and generation, not only the idle model.
  • First-token latency: measure prompt processing separately from generation.
  • Tokens per second: report the batch size, context, output length, and hardware.
  • Failure behavior: record out-of-memory errors, CPU fallback, kernel warnings, and degraded output under the maximum context.

Keep the unquantized or higher-precision run as a reference. A format that saves memory but fails the quality threshold is not a successful optimization.

Troubleshoot common failures

The model loads, then runs out of memory

Reduce maximum context or batch size, clear unrelated GPU allocations, and leave more headroom. Inspect KV-cache growth and temporary allocations. If the model still exceeds the limit, move from 8-bit to a tested 4-bit format or offload selected layers.

Installation succeeds but no GPU acceleration occurs

Check the CUDA runtime, PyTorch build, bitsandbytes support, and GPU architecture against the current compatibility documentation. A package can install while its optimized kernel is unavailable, causing a fallback or an explicit error.

Generation is slower after quantization

Check whether the backend has a fused kernel for the selected format. Dequantization overhead, unsupported operations, CPU offload, and small batch sizes can outweigh the memory-bandwidth benefit. Benchmark the same prompt and output length before changing formats again.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Output quality drops unexpectedly

Compare the same seed and decoding settings with the higher-precision model. Try 8-bit instead of 4-bit, a different calibration set, or a checkpoint produced for your architecture. Verify that tokenizer files and chat templates are identical; a template mismatch can look like quantization damage.

CPU offload causes system instability

Measure resident system memory and check for swapping. Because documented 8-bit offload keeps offloaded weights in float32, the CPU copy can be substantially larger than the GPU copy. Reduce the offloaded layer count, use a machine with more RAM, or select a smaller model.

A practical decision sequence

  1. Measure the baseline. Record model format, peak VRAM, context, batch size, latency, throughput, and quality.
  2. Try 8-bit. It is the least aggressive reduction that often provides a substantial memory saving.
  3. Move to 4-bit NF4, AWQ, or GPTQ only if needed. Prefer a checkpoint and kernel combination already supported by your runtime.
  4. Offload only when latency is acceptable. Confirm system RAM and transfer behavior under load.
  5. Use TensorRT-LLM for a tuned NVIDIA service. Build and benchmark an engine for the actual deployment shape.
  6. Keep the highest-quality option that fits. Compare measured quality and performance rather than selecting solely by nominal bit count.

Limits and compatibility checks

Quantization does not guarantee a fixed VRAM multiplier. KV cache, context length, batch size, temporary buffers, CUDA allocator behavior, and offload can all change peak usage. Formats such as bitsandbytes, AWQ, GPTQ, GGUF with llama.cpp, and TensorRT-LLM target different model files, GPUs, operating systems, and kernels. Check the current model card and backend support matrix before downloading a large checkpoint.

Plan GPU capacity around the quantized model plus runtime headroom. A CUDA-capable NVIDIA GPU with enough VRAM for the selected format is the straightforward option; if that is not available, a smaller model, lower context, or carefully measured CPU offload may be preferable to an unstable deployment.
