The reliable way to detect benchmark contamination is to combine timeline and corpus checks with controlled model-behavior tests. First establish when each benchmark version, derivative, translation, and solution became public and compare that history with the model’s training or knowledge cutoff. If training data are available, search them for exact and normalized copies. If the model is closed, use slot-reconstruction probes and permutation-based likelihood tests, then challenge the result with paraphrased, translated, reordered, and reformatted items. Finally, score the model on private or newly collected items. No single signal proves contamination: a strong conclusion comes from several independent tests with documented controls and uncertainty.
What benchmark contamination and data leakage mean
Benchmark contamination occurs when evaluation material enters a model-improvement process before scoring. The exposed material may be the questions, answer labels, worked solutions, explanations, metadata, or close transformations used during pretraining, supervised fine-tuning, instruction tuning, reinforcement learning, or another training stage.
Data leakage is the broader boundary failure. Information crosses from a protected evaluation or private source into training, prompts, retrieval indexes, demonstrations, or another channel that should have been isolated. It includes direct copies, benchmark derivatives, translations, paraphrases, reformatted code, solution text, and user data that later becomes part of a training corpus.

The most damaging case is training on a test split and then evaluating on that same split. As Oscar Sainz and co-authors wrote in Findings of EMNLP 2023, “The worst kind of data contamination happens when a Large Language Model (LLM) is trained on the test split of a benchmark, and then evaluated in the same benchmark.” The resulting score can be inflated enough to reverse a scientific conclusion: apparent generalization may be retrieval of previously seen material.

Contamination is not automatically established because a benchmark predates a model. An older release is a prior-risk signal; it shows that exposure was possible, not that a particular item was in training. Conversely, a benchmark can leak through an untracked mirror, translation, solution repository, or user conversation even when the canonical file was not used.
Why a high benchmark score is not enough
Standard accuracy measures whether answers match a reference. It does not identify how the model arrived at them. A model can solve an item, memorize its answer, exploit a formatting artifact, or reproduce a sequence seen in training. These mechanisms can look identical in a leaderboard score.
Exposure is also uneven. A training corpus may contain the test split but not the training split, or include solutions while omitting the original questions. A model may have encountered a translated version in another language. Therefore, report contamination by split and by artifact type instead of assigning one label to an entire benchmark.
Large-scale exposure is plausible. Balloccu and co-authors estimated approximately 4.7 million benchmark samples across 263 benchmarks in the evaluation workflows of 255 reviewed papers, considering GPT-3.5 and GPT-4. This estimate does not identify which samples entered a particular model’s weights, but it illustrates why public benchmark text should be treated as potentially discoverable training material.
A defensible detection workflow
Use the following sequence. Preserve the raw evidence at every stage so another evaluator can reproduce the result.
1. Inventory the boundary and timeline
Create a record for every artifact that could have reached training or evaluation:
- Benchmark name, publisher, version, release date, and collection window.
- Membership of train, validation, development, and test splits.
- Question text, answer choices, labels, explanations, solutions, metadata, and evaluation code.
- Known mirrors, scraped copies, translations, paraphrases, reformatted code, and benchmark-derived datasets.
- Model training dates, stated knowledge cutoff, fine-tuning periods, retrieval sources, and model-version identifiers.
Draw a simple timeline. A release before a plausible training cutoff raises the exposure prior; a release after that cutoff lowers the prior but does not eliminate leakage through later fine-tuning, user data, retrieval, or an inaccurate cutoff statement. Keep these possibilities separate in the report.

2. Search an accessible training corpus
If you have the corpus, a data sample, or provenance logs, start with retrieval. Search not only prompts but also answers, solutions, titles, metadata, and known mirrors. Oscar Sainz and colleagues recommend treating overlap analysis as a central part of contamination assessment; Deng and co-authors describe their work this way: “We first introduce a retrieval-based system to explore potential overlaps between evaluation benchmarks and pretraining corpora.”

- Exact matching: compare canonical strings after preserving a copy of the original text. This identifies verbatim copies and is the easiest result to audit.
- Normalized matching: apply documented, deterministic normalization such as case folding, whitespace normalization, Unicode normalization, and removal of stable formatting wrappers. Keep the unnormalized text so reviewers can inspect each hit.
- N-gram retrieval: index contiguous token or word sequences and search for high-overlap passages. Record the n-gram size, overlap threshold, corpus shard, and duplicate count.
- Artifact-level searches: search answer labels, solution prose, benchmark names, item identifiers, and evaluation scripts. A hit in a solution repository can matter even when the question text is absent.
- Manual adjudication: inspect whether a match is a genuine benchmark instance, a common phrase, or an unrelated collision. Store the matched span and its surrounding context.
Separate hits in training data from hits in held-out test data. A training-set match may explain why an item is easy, while a test-set match directly compromises the claimed evaluation. Do not merge the two counts.
3. Probe model behavior with slot reconstruction
When weights and training data are unavailable, behavioral probes can reveal unusual recall. Deng and co-authors introduced Testset Slot Guessing (TS-Guessing), applicable to open and proprietary models. Their protocol masks a wrong answer option or an unlikely word and asks the model to reconstruct it.
- Select benchmark items and create a masking rule before looking at model outputs.
- Remove one option, token, or word while retaining enough context for a normal solver to attempt the task.
- Ask the model to fill the missing slot under fixed prompt wording and decoding settings.
- Run matched controls with the same format, subject, length, and estimated difficulty but from material not suspected of being in the benchmark.
- Repeat across items and report exact-match reconstruction, partial matches, and chance performance separately.
In the NAACL 2024 report, ChatGPT reconstructed the missing MMLU option exactly in 52% of trials and GPT-4 in 57% under the reported TS-Guessing protocol. Those figures are evidence of unusually strong access to the tested material under that setup; they are not a universal contamination threshold and do not prove that a particular training file was the source. Prompt wording, sampling, item difficulty, and chance all affect the result.

Guided generation is a related approach that asks the model to produce benchmark-specific text or answers under constrained instructions. The authors of Time Travel in LLMs reported 92%–100% detection accuracy for their best guided-instruction overlap method across seven datasets when compared with manual expert judgments. Treat this as performance for that method and study design, not as a guarantee for every model or benchmark.
4. Apply black-box likelihood and ordering tests
Some APIs expose token log-likelihoods even when model weights and training corpora are private. A permutation test compares the likelihood of examples in their canonical benchmark order with the likelihood after shuffling the examples. If the canonical sequence is unexpectedly favored, that is evidence consistent with exposure to the ordered material.
Razeghi and colleagues provide a procedure with exact false-positive guarantees under its stated assumptions. To use such a test responsibly, document:
- How likelihood is obtained and whether it is token-, sequence-, or aggregate-level.
- The unit being permuted and the number or method of permutations.
- The null hypothesis, calibration procedure, and any multiple-testing correction.
- Whether order itself carries legitimate structure, such as topic progression or difficulty, that could create a signal without contamination.
A statistically significant ordering effect is not proof of a specific source. It is a black-box signal that should be compared with controls and, where possible, corpus evidence.

Compare model performance and reconstruction behavior across the canonical and transformed versions. Yao and co-authors (2024) show why this matters: cross-language contamination can evade direct text-overlap methods. A model that succeeds only on the canonical wording may be exploiting a memorized string; success on semantically equivalent, newly worded items is more compatible with transferable knowledge, although it still does not rule out task-level memorization.
6. Run a training-cutoff natural experiment
Partition items by when their source became available. Compare performance on material released before a plausible training cutoff with material released afterward, while matching topic, length, format, and difficulty as closely as possible. A sudden advantage on older items can support an exposure hypothesis.
This design is longitudinal evidence, not a clean causal proof. Older and newer collections can differ in subject matter, writing style, and difficulty. Report the matching method and uncertainty, and avoid attributing every time-based performance gap to contamination.

1Fix the driver behind crashes, sound loss and screen glitches2Clear out junk files and repair common Windows errors3Scan for outdated or missing drivers - takes under a minute7. Validate on fresh, private, or dynamic data
The strongest practical check is an evaluation set the model could not have seen. Use a private holdout, newly collected items, or a time-bounded source whose publication follows the model’s training period. LatestEval follows this principle by constructing reading-comprehension evaluations from very recent texts, reducing the chance that pretraining included them.
Keep the fresh set secure until scoring. Version it, log who accessed it, and prevent prompts, labels, and solutions from entering public repositories before the evaluation is complete. Fresh data do not make every confound disappear, but they reduce the largest avenue for direct benchmark memorization.
Choosing methods by access and evidence strength
| Method | Required access | Best at detecting | Controls and limits | Operational cost |
|---|---|---|---|---|
| Corpus retrieval and n-gram overlap | Training corpus, sample, or provenance logs | Exact and lightly edited copies; solution and metadata reuse | Strong audit trail; misses semantic, translated, and task-level variants; common phrases create false matches | High indexing and review cost, but highly reproducible once the corpus is available |
| Perplexity or n-gram accuracy | Model scoring access; usually token likelihoods | Unusually fluent or predictable benchmark text | High scores can reflect item ease, formatting artifacts, or ordinary memorization; matched controls are required | Scalable across many items |
| TS-Guessing and guided generation | API or interactive model access | Memorized options, words, instances, and guided overlap | Sensitive to prompt design, decoding, and chance; compare with format- and difficulty-matched controls | Moderate prompt-engineering and annotation cost |
| Permutation likelihood tests | Black-box likelihood or comparable scoring access | Exposure to canonical ordering or sequence structure | Formal null comparison is possible, but assumptions about ordering, scoring, and calibration must be documented | Moderate computation; statistical expertise needed |
| Training-cutoff natural experiment | Reliable release dates and a model cutoff estimate | Longitudinal exposure patterns | Confounded by changes in task difficulty and data distribution | Low additional tooling; high design burden |
| Fresh or dynamic benchmark | Secure collection and versioning process | Future direct contamination reduction | Requires ongoing collection, access control, and maintenance; does not diagnose past leakage by itself | Continuing operational cost |
How to distinguish memorization from genuine generalization
Use a ladder of increasingly demanding controls rather than one yes-or-no test.
Canonical versus transformed items
Score the original item, a paraphrase, a translation, and a reordered or reformatted version. A large canonical advantage suggests string- or format-specific recall. Similar performance across variants is more consistent with generalized competence, but a model can also memorize multiple public variants.

Difficulty- and format-matched controls
Every behavioral claim needs controls matched for subject, length, answer format, and difficulty. Otherwise an apparently contaminated benchmark may simply be easier or more regular than the comparison set.
Chance and calibration checks
For reconstruction tasks, calculate the chance baseline implied by the number and distribution of possible answers. For permutation tests, predefine the null and report confidence intervals or permutation p-values. Do not select a favorable subset of items after seeing model outputs.
How to report a contamination finding
A useful report lets readers see what was tested and what remains uncertain. Include:
- Model name, exact version, access date, endpoint, system prompt, temperature, sampling settings, and token limits.
- Benchmark name, version, release date, collection window, item count, and split membership.
- The model’s training or knowledge-cutoff information, including whether it is a stated estimate rather than an audited fact.
- Search normalization, n-gram size, retrieval thresholds, deduplication rules, and examples of adjudicated matches.
- Behavioral prompts, masking rules, control construction, number of trials, and decoding settings.
- For statistical tests, the null model, permutations, confidence intervals or p-values, and corrections for multiple comparisons.
- Separate counts for training, validation, and test exposure, plus separate labels for question, answer, solution, metadata, translation, and derivative hits.
- Sample-level evidence, not only an aggregate contamination percentage.
Use graded language such as “direct overlap detected,” “behavioral evidence consistent with exposure,” or “no evidence found under the tested searches.” Do not claim that a negative search proves absence when the corpus, model, or derivatives were inaccessible. No cited study establishes a universal contamination threshold or proves the exact origin of every memorized answer.
Common failure modes and fixes
Relying on the release date alone
Failure: treating a pre-cutoff release as proof or a post-cutoff release as proof of safety.
Fix: track mirrors, translations, solution pages, user-data pathways, later fine-tuning, and the uncertainty of the stated cutoff.
Searching only for exact question text
Failure: missing paraphrases, translations, reordered options, code transformations, and solution-level leakage.
Fix: add normalized and n-gram retrieval, semantic or guided probes, and deliberately transformed test items.

Calling every high score memorization
Failure: confusing item ease, formatting artifacts, reasoning, and recall.
Fix: use matched controls, reconstruction tasks, fresh items, and uncertainty intervals.
Pooling all splits
Failure: reporting one contamination number that hides whether only training examples or the protected test set were exposed.
Fix: preserve train, validation, and test results separately and explain the different consequences.
Publishing the next test set too early
Failure: turning a secure holdout into future training data.
Fix: restrict access, delay public release of prompts and solutions, version every change, and rotate in fresh or dynamic items.
A practical decision framework
- Can you inspect training data? If yes, perform exact, normalized, and n-gram retrieval first. If no, proceed directly to behavioral and black-box tests.
- Did you find direct test-set overlap? Treat the affected score as compromised for claims of clean generalization and identify the exact items and artifacts.
- Is there only behavioral evidence? Replicate with matched controls, transformed items, and an independent method before assigning a contamination label.
- Do methods disagree? Report the disagreement. It may indicate semantic or translated leakage, a formatting artifact, poor controls, or ordinary memorization rather than a contradiction to hide.
- Can you collect new items? Use a private or time-bounded evaluation to estimate performance without relying on the potentially exposed benchmark.
Preventing leakage in future evaluations
- Keep test prompts, labels, solutions, and scoring scripts in a restricted repository.
- Log every person, service, and model that accesses the evaluation set.
- Mark benchmark versions and derivatives so translations and reformats remain traceable.
- Separate development feedback from the final holdout; never tune on protected test answers.
- Use newly collected or dynamic items for high-stakes claims, and rotate them as public exposure grows.
- When releasing a benchmark, publish a contamination-risk statement that records the collection window, known mirrors, and permitted uses.
The practical standard is triangulation: corpus evidence when available, a behavioral or statistical black-box test when it is not, and validation on fresh data in either case. That combination cannot reconstruct every training event, but it can show whether a benchmark score is supported by independent generalization or is plausibly inflated by prior exposure.
