Keep training progress outside the GPU instance: write checkpoints to durable object storage, enable versioning or soft delete, replicate copies to a separate failure domain, and archive the exact code and infrastructure needed to restart. A recovery plan is only credible after you restore a checkpoint and dataset in a clean environment, verify checksums and model loading, and measure the elapsed time against your recovery-time objective (RTO).
Start with the recovery point and recovery time you actually need
Two targets determine the backup design. The recovery-point objective (RPO) is the maximum amount of training work you can afford to lose, measured in time or steps. The recovery-time objective (RTO) is the time from declaring an outage to running useful training again. A team that can tolerate losing six hours of work but must resume within one hour needs a different checkpoint cadence, replication strategy and warm capacity plan from a team that can lose only 10 minutes and can wait a day for new GPUs.
| Decision | What it controls | Evidence to record |
|---|---|---|
| RPO | How often checkpoints are committed to durable storage | Training steps or wall-clock interval between the last usable checkpoint and the failure |
| RTO | How quickly storage, software and GPUs must be provisioned | Elapsed time to restore data, load the model and start a validated training step |
| Failure domain | Whether a local outage, region outage or provider outage is covered | Location of the primary, replica and recovery project or account |
| Integrity objective | Whether an old, uncorrupted copy can be recovered after an overwrite or silent error | Version IDs, checksums and restore-test results |
Do not choose an interval because it is a familiar number. Measure checkpoint duration, storage throughput and observed interruption frequency, then select a cadence that satisfies the RPO without consuming an unacceptable share of GPU time.

A practical design separates low-latency writes from durable, geographically independent copies. The GPU workers should not wait for a cross-region transfer before continuing, but a completed checkpoint must eventually reach storage that survives loss of the training cluster.

Fast tier near the training cluster
Write frequent checkpoints to a high-throughput path in the same region or network locality as the GPUs. This tier minimizes pause time during serialization and upload. Keep only the recent generations needed for rapid restart, and treat this tier as replaceable: an instance disk, attached scratch volume or single-zone filesystem is not a disaster-recovery copy.
Checkpoint overhead can become material at scale. An AWS 2025 example calculates that 48 checkpoints taking three minutes each across 4,000 accelerators consume 2.4 hours of wall-clock time and 9,600 GPU-hours per day. That is an illustrative workload calculation, not a universal benchmark; actual cost depends on model size, parallelism, storage path and implementation.
Durable object-storage tier
Asynchronously copy each completed checkpoint and each dataset snapshot to versioned object storage. Use separate prefixes or buckets for experiments and training runs so that retention, access policies and cleanup cannot mix unrelated work. A durable checkpoint should include the model state, optimizer and scheduler state, random-number-generator state, mixed-precision scaler state, tokenizer and model configuration, metrics, and a manifest of the code and data versions used to create it.
Regional disaster-recovery tier
Replicate the durable objects to a different region or use a storage location designed for geographic redundancy. Retention must cover the time needed to discover silent corruption, accidental deletion or an operator mistake. If a bad artifact is copied immediately to every replica, geographic replication alone will not provide a clean rollback; object versions and an immutable retention policy are the safeguards.
Infrastructure tier
Back up the rebuild recipe as carefully as the weights. AWS disaster-recovery guidance states: “In addition to user data, be sure to also back up code and configuration…” Store infrastructure-as-code, container image digests, operating-system and driver identifiers, CUDA and framework versions, dependency lockfiles, IAM roles, network rules, service quotas, launch parameters and references to secrets. Keep secret values in a managed secret store rather than placing plaintext credentials in a checkpoint or repository.

Validation tier
Schedule restore drills, not just backup jobs. A drill should create a clean project, account or region; restore a representative dataset and checkpoint; verify checksums; load the model; run a short deterministic validation; and record the time to reach a usable training step. AWS Well-Architected puts the requirement plainly: “Perform periodic recovery of the data to verify backup integrity and processes.”
Build a self-describing checkpoint bundle
A file containing only model weights is usually insufficient to resume training. Save a bundle or a manifest that points to immutable objects for every component required to reproduce the next update.

- Optimizer and scheduler: optimizer moments, learning-rate scheduler position, gradient-accumulation counters and global step.
- Numerical state: mixed-precision loss scaler, random-number-generator states for the host and workers, and sampler or data-loader position where the framework supports it.
- Preprocessing assets: tokenizer files, vocabulary, normalization rules, feature schemas and model configuration.
- Run metadata: experiment ID, run ID, timestamp, world size, batch-size settings, precision mode, accumulated metrics and the reason the checkpoint was written.
- Code and environment references: source revision, container digest, dependency lockfile, driver and CUDA versions, and the infrastructure definition used to launch the job.
- Data manifest: immutable dataset snapshot ID, object-version IDs or content hashes, sharding layout, filtering rules and preprocessing revision.
Write the manifest only after all referenced objects are complete. A manifest that points to a file still being uploaded can pass a superficial listing check and fail during a real restore.
Set a checkpoint cadence from measurements
Translate the RPO into an upper bound
If the allowed loss is 30 minutes, the interval between successful durable checkpoints must be no more than 30 minutes under normal conditions. Leave margin for a failed upload, queueing and the time required to detect that a write did not complete. Express the interval in steps as well as minutes when training throughput changes during an epoch.
Measure pause and transfer overhead
Record serialization time, local write time, upload time, verification time and the fraction of those operations that overlap with computation. A checkpoint that nominally runs every 10 minutes but pauses workers for three minutes may deliver less useful progress than a less frequent, asynchronous design. Use a high-throughput fast tier, then copy completed artifacts in the background to durable storage.

Use multiple levels when one interval cannot meet both goals
Many large jobs benefit from a short-interval lightweight checkpoint and a less frequent full checkpoint. The lightweight copy can preserve optimizer and RNG state locally or in nearby storage, while the full copy includes all metadata and is replicated. Define exactly which level is acceptable for each failure scenario; do not label a weight-only snapshot as a complete resume point.
Retain enough generations to roll back
Keep several recent checkpoints plus periodic older generations. Retention should span the detection window for data corruption and human error, not merely the time needed to survive an instance interruption. Mark a checkpoint as verified only after its checksum and load test succeed; automated cleanup should never delete the last verified generation in a failure domain.
Provider implementation patterns
AWS
Amazon SageMaker training jobs support an S3 checkpoint URI so an interrupted job can resume from checkpoint data. Configure the job to write checkpoints to that URI rather than relying on the training instance filesystem. Store each experiment or run under its own prefix and include the run manifest with the objects.
Enable S3 object versioning on the checkpoint and dataset buckets. Use S3 Cross-Region Replication to a disaster-recovery bucket in another region, and monitor replication status rather than assuming that an uploaded object is already present at the destination. Your restore procedure must include the destination bucket policy, KMS permissions where encryption keys are used, IAM roles, network access and any service quotas required to launch replacement GPUs.
Google Cloud
Google Cloud states, “We recommend that you save training checkpoints in Cloud Storage.” Use a Cloud Storage bucket for checkpoints and model artifacts, enable object versioning, and separate experiments or runs with prefixes or buckets. Cloud Storage offers regional, dual-region and multi-region location choices; select the location type according to the failure domain your RTO and RPO require.

Google Cloud documentation describes an annual durability design target of at least 99.999999999%. That is a provider design target, not proof that an application can be recovered: permissions, object versions, replication choices, intact manifests and a tested restore process are still required. Use checksum-based integrity checking when writing and restoring objects.
Azure
For Azure Blob Storage, enable blob soft delete so an accidentally deleted or overwritten object can be recovered during the configured retention period. Copy blobs to a storage account in another region for disaster recovery, and preserve the version or snapshot information needed to select a known-good generation. Recreate the identity assignments, encryption permissions, networking and GPU software environment in the target region before the drill.

Version datasets as rigorously as models
A model checkpoint is reproducible only when its training data can be identified. Treat raw data, cleaned data, indexes and derived features as separate versioned artifacts. Store an immutable manifest containing object keys, content hashes, sample counts, schema version, filtering rules, preprocessing code revision and the date of creation.
Enable object versioning in Amazon S3 and Google Cloud Storage, or blob soft delete in Azure Blob Storage. Versioning protects against an overwrite or deletion, but it does not by itself prevent an authorized process from writing a bad object. Restrict write and delete permissions, require review for retention-policy changes, and keep the recovery copy in a separate account or project when your threat model includes compromised credentials.
When a dataset snapshot is complete, write a small success marker only after every shard has passed checksum validation. The training job should consume the marker and manifest, not a mutable “latest” directory. A new preprocessing pipeline must create a new dataset version; changing files in place makes it impossible to explain which examples produced a checkpoint.

Recover in another region or provider
Use the following sequence for a planned drill or a real regional outage. Adapt the identity and storage steps to the provider, but keep the ordering: establish a trustworthy artifact set before starting expensive GPU work.
- Declare the incident and freeze writes. Stop jobs that might continue updating the primary prefix. Record the last successful checkpoint and dataset manifest, along with their object-version IDs or hashes.
- Select the recovery location. Choose the replicated region, dual-region location or alternate provider specified by the runbook. Confirm that the required GPU type, quota, network route and storage service are available before attempting a restore.
- Authenticate with recovery credentials. Use a recovery role with read access to replicated artifacts and permission to create the required compute and networking resources. Do not copy plaintext secrets into the new environment.
- Choose a known-good generation. Prefer the newest checkpoint whose manifest, checksum and previous restore status are valid. If corruption is suspected, step back through retained versions rather than repeatedly retrying one object.
- Restore the dataset snapshot. Restore the exact manifest and all referenced shards. Verify hashes, shard counts, schema and preprocessing revision before launching a distributed job.
- Recreate the software stack. Apply infrastructure-as-code, pull the recorded container digest, install the recorded dependency lockfile, and match driver, CUDA and framework versions. Recreate IAM, network rules, service endpoints and quotas.
- Load without updating state. Start a validation process that loads the model, optimizer, scheduler, scaler and tokenizer. Confirm the global step and configuration match the manifest.
- Run deterministic checks. Use a fixed validation slice and seed where supported. Compare loss, output shapes, metric ranges and checksum results with the values recorded for the checkpoint.
- Resume a short training segment. Run enough steps to prove that data loading, gradient updates, checkpoint writing and metric logging work in the recovery location. Measure time to the first usable step.
- Promote the recovery location and document results. If the drill is successful, record RTO, the last recoverable checkpoint (actual RPO), replication lag, failed steps and corrective actions. Do not delete the primary or replica until the incident record confirms which copy is authoritative.
Secure the backup path
- Encrypt objects in transit and at rest, and document which key or key-management service protects each bucket or container.
- Use least-privilege roles: training workers need to write their run prefix, while cleanup automation should not be able to delete every historical version.
- Separate production, staging and recovery accounts or projects where practical. A region-wide configuration error should not grant deletion rights over the recovery copy.
- Log object reads, writes, deletes, version changes, replication failures and policy changes. Alert on unexpected deletion or a sudden drop in checkpoint frequency.
- Store references to secrets, certificates and tokens in a managed secret system. The checkpoint manifest should identify the secret name or version, never the secret value.
- Protect infrastructure-as-code and container registries with the same retention and access controls as model artifacts; a perfect checkpoint is unusable without its runtime.
Common failure modes and fixes
| Symptom | Likely cause | Recovery action |
|---|---|---|
| The instance disappeared and no checkpoint exists | Checkpoints were written only to local or ephemeral storage | Move the checkpoint destination to durable object storage and test an interruption before production training |
| The latest object is unreadable | Upload was incomplete or a writer overwrote a valid object | Select an older object version, verify its checksum, and make completion markers atomic |
| Weights load but training diverges | Optimizer, scheduler, scaler, RNG or data-sampler state was omitted | Include full training state and verify a deterministic validation segment during drills |
| Replica exists but the job cannot start | IAM, network, quota, image, driver or CUDA configuration was not backed up | Recreate infrastructure from versioned definitions and record all environment identifiers |
| Restore takes longer than the RTO | Large dataset egress, slow storage path or cold GPU capacity | Measure each phase, pre-stage critical data or a warm environment, and revise the RTO or architecture |
| Both regions contain the same bad data | Corruption or deletion replicated before detection | Use object versions, immutable retention and a rollback window longer than the detection time |
Balance performance, retention and cost
Frequent full checkpoints reduce RPO but increase serialization, storage operations and transfer volume. Lightweight local checkpoints reduce pause time but provide weaker regional protection until they are copied. Cross-region copies improve survivability and can introduce replication delay and restore-egress charges; the cited provider guidance does not establish universal lag or cost figures, so measure them for your object sizes, regions and access pattern.
Retention has a similar trade-off. Keeping only the newest file is cheap but cannot recover from a silent error discovered later. Keep multiple recent versions for rapid rollback and periodic older snapshots for the detection window. Apply lifecycle policies only after confirming that they preserve the minimum number of verified generations in every failure domain.
GPU software portability also affects the real cost of recovery. A checkpoint may be portable between regions on the same provider when the image and drivers are available, but moving to another provider can require changes to storage paths, distributed-training launchers, networking, identity and accelerator-specific libraries. Keep framework-level artifacts and a documented launch configuration separate from provider-specific wrappers so that the model state is not coupled to one instance.
Operational checklist
- Every production run writes checkpoints outside the GPU instance.
- Each run has a separate prefix or bucket and a self-describing manifest.
- Model, optimizer, scheduler, RNG, scaler, tokenizer, configuration and metrics are covered.
- Dataset shards, preprocessing code and immutable manifests are versioned.
- Object versioning or soft delete is enabled and tested.
- A replica exists in a separate region, dual-region or multi-region location appropriate to the failure target.
- Infrastructure-as-code, image digests, dependency locks, driver/CUDA versions, IAM, network rules and quotas are retained.
- Checksums are verified after upload and during restore.
- Automated alerts detect missed checkpoints, failed replication and unexpected deletion.
- A scheduled drill restores a representative checkpoint and dataset in a clean environment.
- The drill records actual RPO, RTO, replication lag and time to the first validated training step.
- Retention policies preserve enough verified history to cover silent-corruption and operator-error detection.
Choose a design that matches the outage you must survive
For instance interruptions, a nearby durable checkpoint path and a short cadence may be sufficient. For a regional outage, add object versioning and an independently located replica, then rehearse rebuilding the complete software and identity stack. For provider-wide or account-compromise scenarios, isolate the recovery account or project and maintain provider-neutral manifests, container references and infrastructure definitions. In every case, the decisive test is the same: can a clean environment identify a verified checkpoint and dataset, load the complete training state, and produce a valid update within the stated RTO?
