AI weather models avoid re-solving every atmospheric equation at forecast time by learning a state-to-state transformation from large archives of weather data. Given a gridded description of the atmosphere, a trained neural network predicts the next atmospheric state in one forward pass. Repeating that operation produces a forecast many days ahead. The shortcut is computational, not a rejection of physics: the training data and starting conditions usually come from physics-based meteorology, including numerical weather prediction (NWP) and reanalysis systems.
The key distinction: forecast-time calculation versus the data pipeline
A conventional numerical weather prediction system represents the atmosphere on a three-dimensional grid. It advances temperature, pressure, humidity, winds and other variables by numerically solving partial differential equations derived from fluid dynamics, thermodynamics, radiation and related physical processes. The grid cannot resolve every cloud, turbulent eddy or radiative interaction, so operational models also use parameterizations for processes smaller than the grid.
That calculation is repeated for every forecast cycle and every time step. A conventional ten-day simulation can take hours on a supercomputer using hundreds of computing nodes. The cost reflects the number of grid cells, variables, time steps and physical calculations that must be performed while keeping the numerical solution stable.

An AI weather model changes what happens after training. Instead of explicitly calculating each physical process at every step, it receives an atmospheric field at time t and outputs a field at a later time, such as t + 6 hours. In simplified form, the network learns:

atmospheric state(t) → atmospheric state(t + Δt)
The predicted state becomes the input for the next step. Repeating the learned transition is called autoregressive rollout. Because inference is a sequence of neural-network forward passes rather than a full numerical solution of the governing equations, the same forecast can be produced dramatically faster.
This does not mean that the model has discovered a way to forecast weather without meteorology. The network learned its transition from examples generated or constrained by meteorological systems, and it normally starts from an analyzed atmospheric state produced by an observation-and-physics system. “Without simulating every physical process” therefore describes the forecast-time computation, not independence from physics.

ERA5 and physics-based reanalysis
Many current AI weather systems are trained on ERA5, the European Centre for Medium-Range Weather Forecasts (ECMWF) global reanalysis. Reanalysis combines observations with a physics-based forecast model through data assimilation to create a consistent estimate of the atmosphere over time. It supplies gridded fields at regular intervals, even where direct observations are sparse.
ERA5 is consequently more than a collection of weather-station readings. Its values reflect the behavior and assumptions of a numerical weather model, constrained by observations. The physics-based Integrated Forecasting System (IFS) and related operational systems also provide initial conditions, validation material or comparison forecasts for many machine-learning studies.
Training on reanalysis teaches a network how atmospheric patterns tend to evolve: how pressure systems move, how temperature and wind fields are linked, and how large-scale structures develop over several hours or days. The network does not need to rediscover these relationships from equations during every forecast. They are encoded in its learned weights.
Good initial conditions still matter
Even a highly capable network cannot make a useful forecast from a poor description of the current atmosphere. Operational centers ingest satellites, aircraft reports, radiosondes, radar, surface stations and other observations into an analysis system. AI models generally consume a gridded analysis produced by that process, so errors in the initial state can propagate through the neural rollout just as they can in a conventional forecast.

ECMWF reports that current machine-learning systems can produce accurate forecasts to about ten days when supplied with good initial conditions. The practical implication is that the data-assimilation and observation pipeline remains critical even when the forecast engine is a neural network.
How a neural weather forecast is generated
- Collect observations and make an analysis. A data-assimilation system combines observations with a short-range model forecast to estimate the atmosphere on a global grid.
- Encode the atmospheric state. The model receives variables such as geopotential height, temperature, humidity and wind on multiple pressure levels, along with surface fields. The exact variable set depends on the model.
- Apply a learned transition. A neural network transforms the input field into a prediction at a specified lead time. During inference, it does not explicitly solve the full set of atmospheric partial differential equations.
- Feed the prediction back in. The output becomes the input for a later step. A series of transitions creates a multi-day forecast.
- Repeat for multiple initial states when uncertainty is needed. An ensemble can run the model from perturbed analyses or with stochastic variations, producing a distribution rather than one deterministic path.
Long rollouts introduce a distinctive failure mode: small errors in one predicted state become part of the input for the next state. Model designers therefore choose lead-time steps, loss functions and architectures that balance speed, stability and accuracy.
Pangu-Weather: a concrete example of the shortcut
Pangu-Weather, described by the Huawei research team in 2023, illustrates how an AI model can be designed around atmospheric structure rather than around a generic image-recognition network.
A three-dimensional Earth-specific transformer
Pangu-Weather uses a three-dimensional transformer in which vertical pressure levels are represented as a real dimension. That design lets the network learn relationships between atmospheric layers directly, rather than treating the atmosphere as a flat map with unrelated channels. Horizontal geographic structure and vertical coupling are both part of the learned representation.
Separate networks for different time steps
The reported system trains separate networks for 1-hour, 3-hour, 6-hour and 24-hour lead times. A forecast can therefore use a transition suited to the interval being predicted instead of forcing one network to handle every temporal scale identically.
Hierarchical temporal aggregation
Pangu-Weather uses hierarchical temporal aggregation during rollout. It selects the largest affordable step for the part of the forecast being produced, then uses smaller steps where needed. Fewer iterations reduce inference time and can reduce the accumulation of numerical or learned-transition error.
Training and evaluation setup
In the reported setup, Pangu-Weather was trained on 39 years of global data from 1979 through 2017, validated on 2019 and tested on 2018. Those dates describe that paper’s experimental split; they are not a claim that every current Pangu implementation uses the same data or evaluation period. The paper trained and tested on reanalysis fields rather than directly on raw observations, and it did not investigate every weather variable, including some precipitation questions.

How Pangu-Weather compares with GraphCast, FourCastNet and IFS
ECMWF has evaluated Pangu-Weather, GraphCast and FourCastNet as major data-driven global systems alongside the operational IFS. The systems differ in architecture and implementation, so a fair comparison must keep the initial conditions, verification data, variables, resolution and lead time consistent.

| Pangu-Weather | Three-dimensional Earth-specific transformer; separate 1-, 3-, 6- and 24-hour networks; hierarchical temporal aggregation. | Reported training used 1979–2017 global reanalysis, with the paper’s validation and test split; some variables, including precipitation, were not investigated. |

| FourCastNet | Uses neural operators and spherical geometry in the version described by ECMWF; NVIDIA’s team describes it as an open-sourced 0.25-degree AI forecasting system. | Performance and speed depend on the specific version, hardware, rollout and evaluation protocol. |
| Operational IFS | Physics-based NWP system used for operational forecasts and as a comparison or source of initial conditions in many studies. | It solves a much broader physical modeling problem at forecast time, so direct speed comparisons must state hardware, forecast configuration and what is included in the measurement. |
These models should not be ranked from a single headline number. Useful comparison axes include training and initialization data, horizontal and vertical resolution, forecast variables, deterministic versus probabilistic output, rollout strategy, benchmark and verification target, performance on extremes, inference hardware and latency, energy use, and operational reliability.
Why AI forecasts can be thousands of times faster
A trained neural network performs a fixed set of tensor operations. Modern accelerators can execute those operations in parallel, and the network does not need to recalculate every parameterized physical tendency at every fine-grained numerical time step. The computational graph is also highly optimized for the target grid and variables.
The Pangu-Weather paper reported 1.4 seconds for single-GPU inference in its setup and described the tested inference as more than 10,000 times faster than operational IFS. Those figures are benchmark-specific: they refer to the paper’s model, hardware, forecast configuration and comparison method, not to every AI model or every IFS run.
A separate example cited by a 2023 Nature article reported that FourCastNet could compute a 100-member, 24-hour forecast in seven seconds. That is an example of ensemble throughput under the stated setup, not a universal latency promise for all FourCastNet deployments.

Speed has practical consequences. A center can run more ensemble members, update forecasts more frequently, explore alternative scenarios, or produce high-resolution downscaling within a fixed computing budget. Faster inference can also reduce energy use, although total system cost still includes data assimilation, storage, training, quality control and operational infrastructure.
What the benchmark results actually show
In the Pangu-Weather paper’s reported ERA5 evaluation, the five-day Z500 root-mean-square error (RMSE) was 296.7 for Pangu-Weather, 333.7 for operational IFS and 462.5 for FourCastNet. Lower RMSE is better. These are scores for one variable, lead time, dataset and evaluation protocol; they are not a universal accuracy ranking.

The same paper reported higher anomaly-correlation scores and lower RMSE than the compared systems for the variables it tested. It also reported useful tropical-cyclone tracking. ECMWF independently found Pangu-Weather to be a legitimate rival to IFS when both were evaluated from the same initial conditions against observations during a European winter period.
Such results demonstrate that a learned transition can reproduce large-scale atmospheric evolution competitively with a conventional model for many medium-range tasks. They do not establish that the neural network has solved every weather problem, every region or every hazard.
Why average accuracy can hide dangerous errors
Smooth forecasts and weak extremes
Models trained primarily to minimize average RMSE are rewarded for being close to the typical field. In rare, high-impact situations, that objective can favor a smooth prediction that misses the peak intensity or sharp structure of an event.
In an ECMWF assessment of a tropical cyclone named Freddy, Pangu-Weather and FourCastNet under-predicted the intensity and symmetry of the cyclone’s winds. The result is a warning against treating a strong average score as proof of reliable extreme-event guidance. Tropical-cyclone intensity, precipitation, heat extremes, severe convection and rapidly developing storms need event-focused and impact-focused verification.
Reanalysis is not the same as direct observation
The Pangu-Weather study’s training and testing fields came from reanalysis. Reanalysis is valuable and physically coherent, but it is an analyzed product, not a uniformly observed measurement of every atmospheric quantity. A model can learn the characteristics and biases of the data product on which it was trained.
Variable coverage is uneven
Large-scale pressure, temperature and wind fields are often easier to forecast and verify than localized precipitation or small convective systems. A result for geopotential height cannot be assumed to apply to rainfall, hail, visibility or surface impacts unless those variables were explicitly trained and evaluated.

Yes, but usually in different parts of the workflow. Physics-based NWP helps produce reanalysis such as ERA5, provides data-assimilation systems that create initial conditions, and supplies operational forecasts against which new methods can be checked. During the neural forecast itself, the model may not explicitly enforce every governing equation or calculate every unresolved process.

Some systems incorporate physical constraints, spherical geometry or conservation-inspired design choices, while others rely mainly on the statistical structure learned from data. Even when a network is purely data-driven at inference, its training examples and deployment context are deeply connected to physical meteorology.
Anima Anandkumar of NVIDIA’s Earth-2 team described FourCastNet’s use of neural operators and spherical geometry, with a goal of supporting super-resolution or downscaling natively. That is a way to encode useful structure into the architecture, not evidence that the model has replaced atmospheric physics altogether.
Are AI weather models replacing numerical weather prediction?
Not by themselves. Operational forecasting requires more than one deterministic map. Centers need uncertainty estimates, ensemble reliability, calibration, data assimilation, monitoring, fallback procedures, long-term stability and evidence that the system behaves safely during rare events.
Early AI systems did not yet provide all of those capabilities at the level required for routine replacement. An AI forecast can be extremely fast and competitive on selected benchmarks while still needing a conventional system for initialization, verification, uncertainty generation or independent cross-checking.
ECMWF’s stated direction is hybrid rather than an abrupt substitution. Machine learning can augment physical models, accelerate expensive components, verify forecasts, downscale fields and provide additional guidance. Meteorological centers retain essential roles in collecting observations, maintaining data-assimilation systems, defining hazards, validating outputs and communicating uncertainty. As ECMWF’s assessment put it, “This is in no way the death of conventional modelling.”
What a trustworthy AI forecast workflow should include
- Documented initialization: identify the analysis system, observations and time of initialization.
- Clear model scope: state the grid resolution, vertical levels, forecast variables and maximum lead time.
- Comparable verification: use the same initial conditions, observations, period and metrics when comparing models.
- Event-based tests: evaluate tropical cyclones, heavy precipitation, heat, cold, wind and other hazards separately from average RMSE.
- Probabilistic information: provide ensembles or calibrated uncertainty rather than presenting one neural trajectory as certain.
- Operational safeguards: monitor drift, detect out-of-distribution situations and retain a physics-based fallback.
- Reproducibility: publish methods, data descriptions and results so independent teams can test claims.
Open comparison is particularly important because speed and accuracy numbers are easy to misinterpret when hardware, resolution or verification targets differ. Florian Pappenberger, ECMWF’s Director of Forecasts, has emphasized that open science, shared methods and comparable results accelerate useful progress.
The practical bottom line
AI weather models are fast because they replace repeated, explicit simulation with a learned atmospheric transition. They can forecast a future gridded state in a neural-network pass and roll that prediction forward, avoiding the need to calculate every cloud interaction, eddy and radiative process individually at deployment time.
The apparent shortcut rests on a substantial physical foundation: observations are assimilated with physics-based systems, reanalysis such as ERA5 supplies much of the training signal, and conventional NWP remains central to initialization and verification. AI models are already credible tools for many medium-range, large-scale forecasts, but their smooth treatment of extremes, uneven variable coverage and immature uncertainty estimates prevent a blanket claim that they replace NWP. The most robust path is a hybrid system in which machine learning adds speed and capability while physical models, observations and meteorological verification provide the foundation and safety net.
