The fastest way for an AI startup to extend runway is to manage inference as a unit-economics problem, not as a hunt for the cheapest GPU. Measure the cost of each successful task, then reduce unnecessary tokens and retries, route easy requests to smaller models, reuse cached context, raise accelerator utilization, and only then consider quantization, compilation, reserved capacity or owned hardware. Every change should be judged against quality, safety, latency and reliability.
This discipline matters because capital is available but more selective. AI companies received 61% of global venture investment in 2025 (USD 258.7 billion of USD 427.1 billion), while total venture investment was about 47% below its 2021 peak, according to the OECD (2026). A UK government study found 58% of respondents viewed growth-funding availability as a major issue for future AI activity. Venture-debt deal value exceeded USD 53 billion in 2024, but deal count fell to its lowest level since 2014, so debt adds repayment risk rather than replacing healthy margins.
Start with cost per successful task
A token price is only a useful metric when it is tied to an outcome. Define a successful task for each product path—for example, a support answer accepted without human correction, a document extraction that passes validation, or a code change that passes tests. Divide all inference and serving expense for that path by the number of successful outcomes.

At first order, token cost is the GPU’s hourly price divided by the tokens it produces per hour, as summarized by The Machine Learning Society (2026). Your operating metric must add the factors that a simple token formula misses:

- GPU or accelerator hourly price, including minimum commitments and idle time.
- Input and output tokens, plus repeated system prompts, retrieved passages and tool definitions.
- Tokens per second at both median and tail load.
- Cache-hit and cache-miss rates, including the memory cost of keeping cached data.
- Retries, rejected requests, agent loops and human review caused by quality failures.
- Routing mix across models, regions and providers.
- Networking, storage, observability, failover and engineering time.
A lower advertised cost per token is not a saving if it increases retries, moderation failures, latency timeouts or manual correction.
Build a cost ledger
| Metric | How to calculate | Why it matters |
|---|---|---|
| Cost per successful task | Total serving cost divided by accepted outcomes | Primary unit-economics measure |
| Cost per request | GPU, API and platform cost divided by requests | Shows where spend enters the system |
| Tokens per task | Prompt plus completion tokens, separated by model | Finds oversized context and output |
| Utilization | Busy accelerator time divided by provisioned time | Exposes idle capacity |
| Cache-hit rate | Requests served from reusable state divided by eligible requests | Measures context-reuse benefit |
| Quality and safety pass rate | Tasks meeting your fixed evaluation criteria divided by tested tasks | Prevents false savings |
| p50/p95 latency | Median and 95th-percentile end-to-end response time | Captures user-visible performance |
Measure before changing infrastructure
- Define the task and acceptance test. Write the exact output conditions, safety checks and human-review rules. Keep a fixed evaluation set that represents production traffic, including difficult and long-context cases.
- Capture a production trace. Log model and route, prompt and completion token counts, queue time, prefill and decode time where available, cache status, retries, failures, region and accelerator type. Remove personal or confidential data before retaining traces.
- Allocate all costs. Include accelerator time, orchestration, storage, networking, monitoring, support and failed attempts. For reserved or owned hardware, spread commitment or depreciation across the capacity actually used.
- Segment the results. Break out interactive versus batch traffic, short versus long prompts, successful versus retried tasks and each model or provider. A single blended average hides expensive tails.
- Set budgets and guardrails. Establish a cost-per-task ceiling, p95 latency target and minimum quality and safety pass rates. Alert on spend spikes, cache collapse and retry storms.
- Keep a control arm. During every optimization, send a statistically useful share of traffic through the current implementation. Compare outcomes against the same task mix rather than against a favorable sample.
Take the low-risk savings first
Route each request to the smallest adequate model
Use a portfolio rather than one model for every job. Deterministic code, parsers and extraction rules can handle stable formats. A smaller model is often sufficient for routine classification, summarization or drafting. Reserve the largest model for cases where the evaluation set demonstrates a material quality or safety benefit.
Implement a router using signals such as task type, document length, language, customer tier and previous failure. If the small model is uncertain or fails a validator, escalate once to a larger model; cap the number of escalations so an agent cannot loop indefinitely. Track quality by route, not just in aggregate, because a cheap route that sends its hard cases into repeated retries can cost more.

- Shorten system instructions while preserving required policy and formatting rules.
- Retrieve only passages relevant to the current question; deduplicate overlapping chunks.
- Store stable tool schemas and repeated documents in reusable prompt or key-value-cache segments where your serving stack supports it.
- Set a maximum completion length appropriate to the task and require structured output when free-form prose is unnecessary.
- Stop agent loops after a defined number of tool calls or when the requested state has not changed.
Measure the quality change after each reduction. Context that looks redundant to a developer may contain a safety constraint or a rare fact needed by a long-tail request.

Reuse key-value caches
For repeated system prompts, retrieved documents and tool definitions, cache the stable prefix so the model does not recompute it for every request. Monitor hit rate, memory pressure and invalidation. Version cached content when policies or documents change; serving stale instructions is a correctness and safety defect, not an optimization.
Batch compatible work
Continuous or dynamic batching combines requests so an accelerator spends less time idle. It generally helps offline or asynchronous jobs and interactive workloads with enough concurrency, but excessive batching can violate latency targets. Tune maximum batch size, queue delay and sequence-length limits separately for prefill and token generation, then watch p95 latency and out-of-memory errors.
Raise serving efficiency with architecture
Memory movement and scheduling can cost as much as raw arithmetic. PagedAttention, discussed in The Machine Learning Society’s 2026 review, reduces reported key-value-cache waste from 60%–80% to under 4% in the configurations it summarizes. The exact result depends on sequence lengths, concurrency and implementation, so verify it with your traces.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsMicrosoft Research’s Splitwise design separates prompt processing (prefill) from token generation (decode) into different machine pools and uses mixed batching sized to demand. This can prevent long prompts from starving decode-heavy interactive traffic. It also adds routing and operational complexity: you need separate capacity forecasts, queue policies and failure handling for each phase.

Full-stack optimizations compound. McKinsey’s 2026 scaling analysis lists cache reuse, batching, scheduling, quantization and data placement as mutually reinforcing levers. Apply one change at a time on the control-arm replay so you can identify which gain survives real traffic.
Test quantization, pruning and compilation with quality gates
Lower numerical precision and remove unneeded weights can reduce memory use and increase throughput. Compilation can fuse operations and improve execution on a particular accelerator. These techniques are workload-dependent: a model may preserve average accuracy while failing more often on safety, rare languages, structured output or long-context cases.
| Technique | Potential benefit | Required checks |
|---|---|---|
| Quantization | Smaller weights and higher throughput | Accuracy by task and language, safety refusals, calibration, p50/p95 latency |
| Pruning | Fewer active parameters or operations | Recall on rare cases, tool-call correctness, failure and retry rate |
| Compilation | Fused kernels and lower execution overhead | Numerical equivalence, supported operators, cold-start time and stability |
| Speculative decoding | More output tokens per unit time when a draft model predicts well | Acceptance rate, quality parity, memory use and tail latency |
McKinsey modeled 85%–95% lower cost per token in some quantization and pruning configurations; that is a modeled range, not a universal startup result. AWS announced in July 2024 that its SageMaker inference optimization toolkit delivered up to about 2× higher throughput and up to 50% lower cost for supported models using speculative decoding, quantization and compilation. Treat both figures as workload- and configuration-dependent upper bounds. Roll out only when the fixed evaluation set meets quality and safety thresholds and the production replay shows lower cost per successful task.

- Interactive requests: keep warm capacity near the user, prioritize predictable p95 latency and autoscale within a safe headroom.
- Asynchronous jobs: queue work and use batch-friendly, lower-cost capacity when deadlines allow.
- Nightly or periodic workloads: schedule them into off-peak windows and release capacity immediately after completion.
- Spiky launches: retain elastic cloud capacity rather than buying hardware sized for the maximum.
Cloud capacity is usually easiest when traffic is uncertain, models change frequently or the team cannot operate hardware. Reserved capacity, colocated servers or owned accelerators can win when utilization is steady enough to amortize commitments. Compare total cost, not the hourly quote: include engineering and migration work, networking, storage, monitoring, spare capacity, repairs, depreciation, failover and data-egress charges.
Compare accelerators and providers on your workload
New accelerator generations often advertise lower cost per token. NVIDIA markets Blackwell inference around that goal and identifies ecosystem providers such as Baseten, Deep Infra, Fireworks AI and Together AI. Those references are starting points for a benchmark, not independent guarantees.
| Question to ask | Why it changes the decision |
|---|---|
| Tokens per second at your prompt and output lengths | Published peak throughput may not match your sequence mix |
| Utilization assumption and concurrency limit | Determines whether the quoted rate is achievable |
| Quality parity and supported features | Prevents savings that create retries or human review |
| p50 and p95 latency under load | Reveals queueing and tail behavior |
| Minimum commitment and billing granularity | Exposes idle-capacity and cash-flow risk |
| Data-region, retention and isolation controls | May be mandatory for regulated customers |
| Egress, failover and migration terms | Quantifies lock-in and outage recovery cost |
Replay representative production traces against each option, keep the existing stack as a control and measure cost per successful task, p50/p95 latency, quality and safety pass rate, utilization, cache-hit rate, engineering effort and lock-in. Do not choose from a single synthetic prompt or a provider’s best-case benchmark.

A staged rollout that protects runway
- Baseline: publish the cost ledger and evaluation scores for the current stack.
- Application cleanup: remove redundant context, cap output and stop loops; these changes are usually reversible.
- Routing and caching: add a small-model path, escalation rules and versioned cache entries.
- Serving tuning: enable dynamic batching, adjust scheduling and separate prefill from decode if demand justifies it.
- Model optimization: test quantization, pruning, compilation or speculative decoding on the fixed quality set.
- Capacity decision: compare elastic, reserved, colocated and owned options using measured utilization and a demand forecast.
- Canary and rollback: expose a small traffic share, enforce spend and quality budgets, and keep an immediate route back to the control.
Common failure modes and fixes
The token price falls but total spend rises
Check whether prompts became longer, cache hits fell, output limits increased or retries multiplied. Recompute cost per successful task and inspect each route separately.

Batching improves throughput but users complain
Reduce queue delay or batch size for interactive traffic, isolate long sequences and reserve larger batches for asynchronous work. Monitor p95 rather than relying on average latency.
Quantization passes average accuracy but fails customers
Expand the evaluation set with rare, safety-sensitive and structured-output cases. Compare refusal, tool-call and validation-failure rates, then keep the higher-precision model for affected routes.
Reserved or owned hardware sits idle
Measure utilization by hour and workload. Move flexible jobs into idle windows, share capacity across products or return to elastic capacity until demand is predictable enough to amortize the commitment.
Caching returns stale or incorrect answers
Version prompts and documents, invalidate entries on policy changes and include tenant and authorization state in the cache key. A cache hit is valuable only when it is correct and permitted.
Financing implications for operating plans
Investors increasingly examine gross margin, burn and runway alongside model quality. Show how each product path converts accelerator spend into successful outcomes, which assumptions depend on utilization, and how quickly the system can scale down. Treat venture debt as a financing instrument with scheduled repayment and covenants; the 2024 increase in deal value alongside the lowest deal count since 2014 indicates that access is selective, not guaranteed.
The practical sequence is therefore conservative: establish the ledger, take reversible application and routing wins, validate serving and model changes under production-like load, and commit to hardware only when measured utilization and demand visibility support it.
