AI defect detection is a production inspection loop, not just a neural network. You capture images under the same camera, lens, lighting, fixturing and timing used on the line; label them according to the decision the station must make; train a suitable model; test it on untouched production-like data; then monitor errors and retrain as products and defects change.

The most important design choice is usually not the model architecture. A camera mismatch, uncontrolled glare or an unrepresentative training split can make an excellent benchmark model fail at the station.

What AI defect detection does

An AI inspection system converts sensor observations into a quality decision. Depending on the station, its output may be a binary pass/fail result, a defect class, the location of one or more defects, a pixel mask showing the affected area, or a confidence score that routes borderline parts to an operator.

The system normally combines five elements:

  • Part presentation: fixturing and triggering place the product in a repeatable field of view.
  • Image capture: an industrial camera, lens and illumination expose the visual evidence.
  • Inference: a trained model evaluates the image or a cropped region.
  • Decision logic: thresholds and business rules turn model outputs into a disposition.
  • Feedback: reviewed failures, misses and new products become data for the next iteration.

A model can only learn patterns present in its input. If a reflection, focus error or fixture edge is correlated with bad parts during training, the model may learn that nuisance artifact instead of the defect. This is why production-matched image capture is as important as model selection.

Start by defining the inspection decision

Before collecting images, write down what the station must decide and what happens after each outcome. The same physical defect can require different AI outputs at different stations: a simple reject gate may need only pass/fail, while rework may require a precise location and defect type.

Specify the unit and field of view

Define whether one image represents a whole product, a component, a weld, a surface patch or several parts. State how many parts can appear in one frame and whether the camera sees a fixed pose or arbitrary orientation.

Define the defect taxonomy and tolerance

List the defect classes operators actually distinguish, such as a missing component, crack, scratch or contamination. For each class, define the acceptance limit: for example, a mark may be acceptable below a certain length but rejectable above it. If experts cannot consistently agree on a label, the taxonomy needs clarification before model training.

Set the cost of errors

A false accept sends a defective part forward; a false reject removes a good part or stops production. Those costs determine the operating threshold and whether uncertain cases should be sent to a human reviewer. Record the required response time, line rate and allowable review queue as requirements, not as afterthoughts.

Build a production-matched image stream

Texas Instruments advises collecting training images with a camera that closely matches the one used on the factory line, using the factory lighting and matching lenses. The same principle applies to focus, exposure, working distance, trigger timing and image compression.

Match the optical setup

  • Use the industrial camera and lens intended for deployment, or an optically equivalent setup.
  • Fix the working distance, focus and aperture; document any settings that operators could change.
  • Choose a field of view that preserves the smallest defect the decision must catch.
  • Control motion blur with suitable exposure and triggering rather than expecting the model to repair blurred evidence.

Capture realistic variation

Include expected part orientations, normal cosmetic variation and the lighting changes that can occur on the line. Texas Instruments specifically recommends examples of nuisance conditions such as partial illuminator failure. If a lamp can dim, a part can rotate slightly or a fixture can accumulate debris, those conditions belong in validation data rather than being discovered after launch.

Camera or lens mismatch creates domain shift: the model may interpret differences in sharpness, distortion or glare as a defect. A stable machine-vision ring light and repeatable fixturing reduce this risk, but they do not eliminate the need to show the model realistic operating variation.

Keep provenance with every image

Store product or batch identifiers, station and camera settings, timestamp, lighting state, operator disposition and model version where governance permits. Provenance lets engineers determine whether an apparent model regression is actually a new supplier lot, a changed fixture or a failing light.

Choose labels that match the model objective

Labeling granularity should follow the decision. Selecting an architecture first and then discovering that its annotations cannot be produced consistently is an expensive rework cycle.

Inspection objective Required annotation Best fit Typical use
Pass/fail or one class per crop Image-level label such as NORMAL or ABNORMAL Classification Fixed-location surface or component checks
Find separate defects and identify them Bounding box plus class for each defect Object detection Cracks, missing components or multiple discrete defects
Measure an irregular region Pixel mask outlining the defect Segmentation Extended contamination, coating damage or shape-driven disposition
Flag departures from known-good appearance Mostly defect-free images; bad examples for threshold validation Anomaly detection Rare, changing or incompletely catalogued defects

Image-level labels are faster to create but cannot teach a classifier where a defect is. Boxes provide location without pixel-perfect boundaries. Masks demand the most annotation effort, yet they are justified when area, shape or precise localization determines the disposition.

Compare the main model families

Classification

A classifier predicts a class for a crop or image. It is the simplest option when the part is aligned and the question is essentially “acceptable or not?” Classification can be highly effective for a fixed inspection region, but it does not inherently identify where a defect appears or separate multiple defects in one frame.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Object detection

An object detector returns bounding boxes and classes. It is useful when a frame can contain several distinct defects or when an operator needs an approximate location. Box size and overlap rules become part of the evaluation, so annotate consistently around the visible defect rather than around unrelated shadows.

Segmentation

Segmentation predicts defect pixels. It is appropriate when irregular shape or affected area matters, such as coating voids or contamination. The extra labeling effort pays off when a box would be too coarse for an acceptance rule.

Anomaly detection

Anomaly models learn the distribution of normal appearance and flag deviations. MathWorks examples include Student-Teacher and PatchCore localization. This approach can reduce the need for exhaustive labels when defects are rare or their taxonomy changes, but it still requires representative normal images and threshold validation on realistic bad parts.

Anomaly detection does not magically understand every unseen failure. It may miss a defect that resembles normal variation, and it may flag harmless changes such as a new but acceptable texture. Use a validation set containing known bad parts, borderline parts and nuisance variation to set the threshold and review policy.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Multimodal models and sensor fusion

Visual evidence can be combined with process sensors such as welding current, voltage and temperature. Intel’s sample workflow fuses signals with logical AND/OR rules. Fusion is useful when a defect is visually ambiguous but process data is diagnostic, or when a sensor can suppress false alarms from a difficult visual condition. Define how missing or contradictory sensor readings are handled before deployment.

Prepare training, validation and KPI test data

Use three disjoint sets:

  • Training: images used to fit model parameters.
  • Validation: images used during development for threshold, augmentation and architecture choices.
  • KPI test: untouched images used once the design is frozen to estimate production performance.

Do not place near-duplicates, consecutive frames of the same part or images from the same physical unit across these sets. Leakage makes results look better because the model has effectively seen the answer. NVIDIA’s automated optical inspection workflow treats leakage as a hard stop.

Metrics to agree before training

Metric What it answers Why it matters
Per-defect recall How many examples of each defect are found? Aggregate accuracy can hide a dangerous miss rate for a rare class.
False-accept rate How often does a bad part pass? Directly measures escaped defects.
False-reject rate How often is a good part rejected? Measures scrap, rework and operator burden.
Confusion matrix Which classes are confused? Shows whether taxonomy or data needs correction.
Operating threshold Where is the pass/reject or review cutoff? Performance is inseparable from the chosen threshold.
Latency and coverage Can every required frame be inspected in time? A highly accurate model that misses triggers is not a complete inspection system.

Write a metric contract with the quality and production teams. A threshold chosen only for a benchmark score may be unsuitable when a false accept costs much more than a false reject.

Iterate with an error-analysis loop

A first model is a baseline, not a finished system. NVIDIA’s documented DEFT workflow illustrates a practical cycle:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Train a baseline on an initial seed set. The example uses about 200 rows for a normal first run; this is an example workflow value, not a universal sample-size requirement.
  2. Evaluate on the KPI set using the agreed recall, false-accept and false-reject measures.
  3. Perform root-cause analysis. Group errors by lighting, orientation, supplier lot, defect type, camera condition and operator disagreement.
  4. Generate targeted synthetic defects where suitable, while preserving realistic geometry, texture and lighting.
  5. Mine matching real images from a production pool. The mining pool must contain no-good samples for every defect type represented in the KPI set, not only PASS samples.
  6. Retrain and re-evaluate against the same metric contract, keeping model versions and data manifests.

Synthetic images are a supplement, not proof that the model will work on the line. Real images remain necessary to test sensor noise, fixturing variation and the appearance of actual failures.

Can AI find defects it has never seen?

Sometimes, but the answer depends on what “never seen” means. A supervised classifier or detector is optimized for its labeled classes; it generally cannot reliably name a genuinely new defect without representative examples or a suitable retraining process.

Anomaly detection can flag a visual departure from normal appearance without a label for that exact failure. Its success depends on how completely normal variation was represented and whether the new defect is visually distinct from acceptable parts. A new defect that is subtle, partly occluded or similar to normal variation may be missed, while a harmless product change may trigger an alert.

For unknown or evolving defects, use anomaly scores as a review signal, retain the image and operator decision, and periodically add confirmed cases to supervised or anomaly-model training. Keep a human escalation path for low-confidence results.

Deploy inspection on a factory line

Edge inference

Edge deployment runs inference near the camera or controller. Texas Instruments describes low-latency neural inference on factory processors. This approach minimizes network dependence and can keep images inside the plant, but it requires hardware sized for the model, frame rate and preprocessing pipeline. Plan how models are versioned, rolled back and updated without interrupting production.

API-based inference

An API sends images to a remote model and integrates the response with an existing quality-control workflow. AWS demonstrates an API-based multimodal alternative. It can simplify centralized model management, but connectivity, round-trip latency, data governance and outage behavior must meet the station’s requirements.

Constraint Edge choice API choice
Latency Predictable local response Depends on network and service response
Connectivity Can continue during network loss Requires a defined outage fallback
Data governance Images can remain on site Review transfer, retention and access controls
Maintenance Each station needs hardware and update procedures Centralized service updates, with dependency on provider availability

Controls required at the station

  • Triggering and fixturing that keep every part in the validated field of view.
  • Calibration records for camera, lens, lighting and any geometric measurement.
  • Image-retention rules that support investigations without retaining unnecessary data.
  • Model-version identifiers attached to each decision.
  • Operator review and override logging for uncertain or disputed cases.
  • A safe response when the camera, light, sensor, network or model is unavailable.

Equipment and commissioning checklist

  • Camera: an industrial USB or equivalent machine-vision camera with adequate resolution, shutter behavior and frame rate.
  • Lens: matched to the working distance and field of view; verify distortion and depth of field.
  • Illumination: stable, repeatable lighting, often a machine-vision LED ring light or another geometry suited to the surface.
  • Fixturing: repeatable part placement that limits pose variation without masking relevant surfaces.
  • Compute: edge hardware or an API path sized for preprocessing, inference and required throughput.
  • Calibration: documented setup checks and a process for detecting drift.
  • Data controls: retention, access, labeling, model-version and audit procedures.

Commission with a deliberately held-out run of good, bad, borderline and nuisance-condition parts. Confirm that the physical station captures every required part, that the decision arrives before the actuator deadline and that operators can understand the evidence behind a reject or review.

Use public datasets without overclaiming

The MVTec Anomaly Detection dataset page lists over 5,000 high-resolution images across 15 object and texture categories. It provides defect-free training images, defective and non-defective test images, and pixel-precise annotations. Its CC BY-NC-SA 4.0 license prohibits commercial use unless the license terms are satisfied.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

MVTec is useful for comparing algorithms and building prototypes. A score on that public dataset does not establish performance on a particular factory line. Production claims must be validated with line-specific images, optics, lighting, orientations and defect costs.

Common failure modes and fixes

The model works in the lab but fails on the line

Check camera, lens, focus, exposure, lighting geometry, trigger timing and part pose. Rebuild the dataset from the production station and include the nuisance variation that was absent from the lab.

False accepts are concentrated in one defect class

Inspect the confusion matrix and the KPI test composition. Add representative no-good samples for that class, review labeling consistency and tune the operating threshold against the stated cost of escape.

False rejects rise after a product change

Determine whether the change is an actual defect or a new acceptable appearance. Add approved examples to the normal distribution or retrain the supervised class while preserving old products in validation.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Anomaly detection alarms on harmless variation

Expand normal training data to cover approved orientations, lots and lighting states. Validate thresholds on realistic bad parts and borderline good parts; do not set the cutoff from normal images alone.

Reported accuracy is suspiciously high

Audit for duplicate frames, repeated parts or batch leakage between training, validation and KPI test sets. Re-split by physical unit or production run where appropriate and rerun the frozen KPI evaluation.
