Federated learning can keep raw training examples on a device, but it does not guarantee that the data stays private. A system may send model updates derived from that data, and those updates—or the trained model—can reveal information. To assess a particular app or service, look beyond the “federated” label for protections such as secure aggregation and differential privacy, plus clear details about what is sent, retained, and verifiable.

Does my data leave my device?

In a common federated-learning setup, participating devices receive a shared model, train it locally on their own data, and send model updates to an aggregator. The aggregator combines updates—often by averaging them—to produce a revised global model. The cycle can repeat without gathering raw examples into one central training dataset. But “the raw data stays local” does not mean “nothing derived from it is transmitted”: an update can carry information about the data used to create it. The exact data flow depends on the implementation. NIST’s overview of privacy attacks in federated learning and its discussion of federated learning and secure aggregation explain these distinctions.

Can federated learning leak personal information?

Information in model updates

Yes. NIST describes attacks that can recover or approximate training data from model updates. Some reported examples achieve near-perfect approximations, but that does not mean every attack works against every system. Feasibility depends on factors such as the model, protocol, attacker’s access, and defenses. NIST’s conclusion is that “Attacks on model updates suggest that federated learning alone is not a complete solution for protecting privacy during the training process.” The statement appears in Privacy Attacks in Federated Learning, published January 24, 2024, by Joseph Near, David Darais, Dave Buckley, and Mark Durkee.

Information in the trained model

Privacy questions do not end when the updates are combined. A trained model may retain or reveal information about its training data through its outputs. Protecting the exchange during training and limiting what can be inferred from the final model are related but distinct problems; NIST describes the latter as output privacy.

What does secure aggregation protect?

Secure aggregation is designed to let a system calculate a combined value—such as the sum or average of model updates—without showing the aggregator each participant’s individual contribution, subject to the protocol’s assumptions. It limits a particular exposure; it does not by itself guarantee that an aggregate or final model reveals nothing about an individual.

The original protocol by Bonawitz and co-authors describes computing an aggregate without revealing individual values beyond what can be learned from that aggregate. In its stated setting, it tolerates up to one-third of users failing to complete the protocol. That is a robustness result for that protocol, not a general privacy statistic for federated learning. Secure aggregation designs have trade-offs and trust assumptions. NIST discusses secret-sharing approaches and notes their communication and coordination costs, as well as homomorphic encryption and secure enclaves. Homomorphic-encryption designs may require a key holder that does not collude with the aggregator; enclave security depends on trust in the hardware and its implementation. NIST’s report on federated learning and secure aggregation describes these approaches.

Does differential privacy guarantee anonymity?

No. Differential privacy is a mathematical framework for limiting and quantifying how much an individual’s participation can affect a computation’s output. It is not a blanket promise of anonymity, and the label alone is not enough to evaluate a system. In federated learning, mechanisms can bound participant contributions and add calibrated noise; the actual guarantee depends on the mechanism, parameters, unit of privacy, and implementation.

NIST’s March 2025 publication, SP 800-226, Guidelines for Evaluating Differential Privacy Guarantees, explains how to assess such claims and warns that practical hazards can arise when mathematical definitions are implemented in software. Ask whether a stated guarantee applies to each user or each example, what parameters are published, and which outputs it covers.

A specific example should not be mistaken for a universal result: Google Research reported a “more than two-fold” reduction in memorization for Smart Text Selection models using its combination of secure aggregation and distributed differential privacy, measured with standard empirical testing methods. This is a company-reported result for that deployment and measure, not a general effect of federated learning. Google also notes that “SecAgg helps minimize data exposure, but it does not necessarily produce aggregates that guarantee against revealing anything unique to an individual.” See Google Research’s March 2, 2023 explanation.

How can I evaluate a specific app or service?

General descriptions of federated learning cannot establish what an unnamed product actually does. Look for deployment-specific documentation and answers to these questions:

  • What stays on the device? Does the system keep raw records local, or do derived features or some fields leave the device?
  • What is uploaded? Identify whether the service sends individual updates, masked or encrypted updates, aggregate updates, metrics, or other telemetry.
  • Who can see individual contributions? Check whether the aggregator, service operator, other participants, or no party under stated protocol assumptions can inspect them.
  • Are updates and metrics protected by secure aggregation? Look for what the protection covers and the assumptions it requires.
  • Is differential privacy used? Find out whether it is user-level or example-level, which outputs it covers, and whether the guarantee and parameters are documented.
  • What is retained, and for how long? Ask about uploaded updates and intermediate values, not only raw records.
  • What trust is required? Identify any trusted key holder, hardware enclave, or service operator and what role each has.
  • Can the implementation be checked? Look for auditable code, published policies, or a way to verify that the deployed system follows its stated protections.

These checks reflect the evaluation questions in NIST’s secure-aggregation guidance and NIST’s differential-privacy guidance. Aggregation, encryption, and noise mechanisms can also involve communication, computation, or model-quality trade-offs; ask for evidence specific to the deployment rather than assuming a particular cost or benefit.
