Looking at individual neurons is only one level of neural-network interpretability. For many questions, a better explanation comes from learned features, causal pathways, interventions, weight interactions, or model-level concepts. The most reliable practice is to use neuron inspection to generate hypotheses, then test those hypotheses with circuit localization and causal interventions.

No method is universally best. Sparse autoencoders can expose features that are distributed across neurons, while supervised distributed alignment search can target variables tied to a known task. Attribution and mask optimization can locate candidate circuits, but only interventions such as activation patching or ablation can show whether a component is necessary or sufficient. Weight- and interaction-level tools add information that activation-only analyses miss.

Why neuron-only explanations can be incomplete

Concepts may be distributed across neurons

A neuron-level story assumes that a meaningful concept, such as grammatical number or a location, is represented by one neuron or a small set of easily interpretable neurons. That assumption often fails. The high-level concepts a network uses for computation need not align with individual neurons, as Aryaman Arora, Zhengxuan Wu, Jacob Steinhardt, and Sarah Schwettmann state in their ICML 2026 work.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A single neuron can respond to several unrelated features, a property commonly called polysemanticity. Conversely, one concept can be spread across many neurons, layers, or directions in activation space. Inspecting the most active neurons may therefore reveal a correlation without identifying the representation that the model actually uses.

Activations do not show interactions by themselves

Activation visualizations describe what components fire on examples, but not necessarily how their values combine. A feature may matter only when another feature is present, when two paths cancel each other, or when a downstream weight amplifies a small difference. The ICLR 2026 Circuit Insights work warns that activation-only approaches can miss these interactions.

Interpretability has several units of explanation

Choose the unit that matches the question:

  • Neuron: an individual activation channel, useful for quick hypotheses and some sparse representations.
  • Feature: a direction or latent variable represented across one or more neurons.
  • Component: an attention head, MLP block, residual stream location, or other architectural part.
  • Edge: a connection or information-flow link between components.
  • Circuit: a connected set of components and edges that carries out a computation.
  • Concept or representation: a model-wide property studied across layers, examples, or tasks.

Moving to a larger unit does not automatically make an explanation more truthful. It changes what can be measured and what must be validated.

Feature-level alternatives: sparse autoencoders and DAS

Sparse autoencoders (SAEs)

A sparse autoencoder learns an encoder and decoder that reconstruct a model’s activation while encouraging only a small number of latent features to be active for any input. The decoder vectors define a new feature basis; the encoder reports which features are present. Instead of asking “which neuron fired?”, you ask “which learned feature was active, and what examples does it explain?”

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

SAEs are useful when activations appear polysemantic or when a concept is distributed over many neurons. You can train an SAE on activations from a selected layer, inspect examples that maximize each feature, and trace the feature’s downstream effects. The choice of layer, training corpus, dictionary size, sparsity penalty, and reconstruction quality all affect the resulting features. A feature is an analysis artifact until it is tested on held-out examples and, ideally, by intervention.

SAEs are not guaranteed to improve on neurons. In the MIB (ICML 2025) benchmark, SAE features were not better than neurons for its causal-variable localization track. That result applies to the benchmark’s models and tasks; it is not a universal verdict against SAEs. In some settings, the original MLP neurons can themselves form a sparse and useful feature basis.

Supervised distributed alignment search (DAS)

DAS searches for a distributed subspace aligned with a supervised variable. You provide labels or paired examples for a causal variable, such as subject number, and optimize a rotation or representation alignment so that the variable is linearly accessible in the selected subspace. Because the target is specified in advance, DAS can be more focused than an unsupervised feature dictionary.

Use DAS when you have a well-defined variable and enough representative labeled data. It is less suitable when you do not know what concepts the model may contain, because the method can only search for the variables you specify. Alignment also does not prove that the model uses the subspace to produce its output; a causal intervention is still required.

SAE and DAS compared

Method Primary unit Data requirement Best initial question Main limitation
Neuron inspection Individual activation channel Representative examples; no extra training required Which channels correlate with this behavior? Polysemanticity and distributed representations can obscure the mechanism
SAE Unsupervised learned feature Activation dataset plus SAE training What reusable features decompose this activation space? Features depend on layer, dictionary, sparsity, and training data; they may not be causal
DAS Supervised distributed subspace Labeled examples for a defined variable Where is this known variable encoded across a representation? Requires a target variable and can identify encoding without proving use

Localizing circuits and pathways

Attribution methods

Attribution assigns a contribution score to inputs, neurons, heads, components, or edges. Gradient-based scores, integrated methods, and activation attribution can rank what appears to influence a particular output. Aggregating scores across layers produces a candidate pathway or circuit.

Attribution is comparatively scalable: it can process many examples without manually reading every activation. Its scores are still dependent on the baseline, output being measured, nonlinearities, and aggregation rule. A highly ranked edge is evidence for prioritization, not proof that removing the edge will change the behavior.

Mask optimization

Mask optimization learns a soft or hard mask over components or connections while preserving a target output or behavior. The optimization objective usually balances fidelity against sparsity, so the result is a concise candidate circuit. The method can search more broadly than hand-selecting neurons, but the mask objective, regularization, initialization, and evaluation set shape what is found.

Pathway graphs

Once candidate components are scored, represent them as a directed graph: nodes are heads, MLPs, residual locations, or learned features; edges are information-flow connections. A graph makes it possible to ask whether a signal enters at one layer, is transformed by intermediate components, and reaches the output through a coherent route.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Localization and mechanism are different claims. A circuit can reproduce a behavior on the examples used to find it while omitting a backup path, relying on a correlated variable, or failing on distribution shifts.

What the MIB benchmark found

The MIB study evaluated two tracks—circuit localization and causal-variable localization—across four tasks and five models. In its circuit-localization benchmark, attribution and mask optimization performed best. In causal-variable localization, supervised DAS performed best. SAE features did not outperform neurons on that causal-variable task.

These are conditional benchmark findings, not a ranking for every architecture. The appropriate method depends on whether you are locating a pathway, identifying a known variable, or discovering unknown features.

Causal interventions: the validation layer

Activation patching

Activation patching, also called causal tracing in some setups, swaps an activation from a clean run into a corrupted run, or vice versa. For example, run a prompt that produces the correct answer and a minimally changed prompt that causes an error. Patch one component’s activation from the clean run into the corrupted run. If the output recovers, that component carries information relevant to the difference.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Patch at multiple granularities: token positions, attention heads, MLP outputs, residual stream slices, or learned feature coordinates. Record the exact source and target examples, layer, position, tensor slice, and metric used to define recovery. A single successful patch shows a causal effect under that intervention; it does not establish that the component is the only route or that the same circuit works on other prompts.

Ablation and knock-in tests

An ablation removes or replaces a component, feature, edge, or subspace. If behavior degrades, the removed element was necessary under the test conditions. A knock-in or activation injection asks whether adding the element is sufficient to produce the behavior. Necessity and sufficiency are distinct:

  • Necessity: removing the candidate changes the output or reduces a task metric.
  • Sufficiency: inserting or restoring the candidate produces the target behavior in an otherwise unfavorable context.
  • Specificity: the intervention changes the intended behavior without broadly damaging unrelated outputs.

A practical intervention protocol

  1. Define the contrast. Select matched clean and corrupted inputs that differ in the behavior of interest, and pre-register the output metric.
  2. Generate candidates. Use neuron, feature, attribution, or mask analysis to produce a ranked list of components or edges.
  3. Patch one location at a time. Keep all other activations unchanged and record the exact layer, token, and tensor slice.
  4. Test combinations. Patch the proposed circuit jointly, then remove individual members to identify redundancy and order effects.
  5. Use held-out examples. Evaluate on prompts and labels not used to select the candidates.
  6. Check controls. Apply the same intervention to unrelated tasks, random locations, and shuffled pairings to detect nonspecific effects.
  7. Report effect sizes. Include baseline performance, post-intervention performance, variance across examples, and the intervention’s computational cost.

Weight- and interaction-level analysis

WeightLens

WeightLens analyzes learned weights directly to identify context-independent features without requiring an explainer model or a dataset for every interpretation. This is valuable when activation collections are expensive, privacy-sensitive, or too narrow to represent the model’s operating range. Weight evidence can reveal what a component is configured to respond to, but it does not show which inputs actually activate it or whether downstream paths suppress the effect.

CircuitLens

CircuitLens models interactions between components rather than inspecting each activation independently. Interaction analysis can expose synergy, cancellation, gating, and conditional computation that a list of highly active neurons would miss. The trade-off is complexity: interaction graphs grow quickly, and a concise visualization may depend on thresholding or a selected context.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When to prefer weights or interactions

  • Choose weight-level analysis when you need a context-independent view or lack a representative activation dataset.
  • Choose interaction analysis when behavior appears conditional, compositional, or dependent on several components firing together.
  • Combine either with activation tests when you need to connect a static explanation to a specific input and output.

Representation and concept-level approaches

Some questions are broader than a single circuit. Concept-based explanations study whether a model encodes a human-defined concept and where that concept becomes accessible. Representation probing can test linear or nonlinear decodability across layers, while concept interventions alter the corresponding direction or subspace to test whether the model uses it.

Mechanistic interpretability focuses on mapping computations to components and pathways. Causal interpretability emphasizes interventions and counterfactual effects. Axiomatic attribution methods impose formal properties, such as completeness or sensitivity, on contribution scores. A 2026 survey groups circuit analysis, mechanistic interpretability, concept-based explanations, causal interpretability, and axiomatic attribution among major theory-grounded approaches.

These approaches answer different questions. A probe can show that information is decodable, but decodability alone does not show that the information controls the output. A concept direction can be causally manipulated, but the intervention may affect multiple correlated concepts. Always state whether the result concerns encoding, use, necessity, sufficiency, or a complete mechanism.

What small circuits can and cannot tell you

Concrete examples show why scale claims need qualification. On a standard subject–verb agreement benchmark reported by Marks and colleagues in 2025, a circuit of approximately 102 MLP neurons was enough to control model behavior. The same ICML 2026 work reported small neuron sets encoding latent steps in a city–state–capital task.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

These are task-specific demonstrations, not a universal scaling law. A circuit size can change with model architecture, layer choice, prompt format, metric, redundancy, and the strictness of the behavioral test. Report the model, task, dataset, layer, selected components, and intervention whenever you claim that a circuit controls behavior.

Choosing a method for your question

Question Recommended starting point Evidence you obtain Validation needed
Which unknown features appear in a layer? SAE, followed by feature visualization Candidate latent features and activating examples Feature ablation or patching on held-out inputs
Where is a known variable represented? DAS or a representation probe Distributed subspace aligned with the variable Intervene on the subspace and measure task behavior
Which components form a candidate pathway? Attribution, then mask optimization Ranked nodes, edges, or sparse circuit Joint and single-component patching or ablation
Does a component carry information between two conditions? Activation patching Counterfactual causal effect under a defined swap Controls, held-out examples, and necessity/sufficiency tests
What does the network’s parameterization favor? Weight-level analysis Static features implied by learned weights Activation and behavioral checks
Does behavior depend on combinations? Interaction or circuit analysis Conditional, synergistic, or suppressive relationships Interventions that isolate each interaction

Use more than one row when the claim is important. A practical combination is: discover features with an SAE or DAS, localize a pathway with attribution or masking, then validate the proposed mechanism with patching and ablation.

A reproducible workflow beyond neuron inspection

  1. Specify the behavior precisely. Define the input distribution, target output, comparison condition, and success metric. “Understands capitals” is too broad; a fixed city–state–capital task with an exact-answer metric is testable.
  2. Choose the analysis unit. Start with features for distributed representations, components and edges for pathways, weights for static structure, or concepts for cross-layer questions.
  3. Build a representative dataset. Include varied wording, difficulty, positions, and negative controls. Keep selection and evaluation sets separate.
  4. Generate hypotheses automatically where possible. Use SAE feature search, DAS, attribution, or mask optimization to reduce manual selection.
  5. Inspect examples, not just scores. Read high- and low-activating cases, check for duplicate or contradictory semantics, and examine whether a feature is tied to formatting or token position.
  6. Map information flow. Connect candidate features or components across layers and identify upstream sources and downstream recipients.
  7. Intervene. Patch, ablate, or inject the candidate at the same positions used for discovery. Measure both target behavior and unrelated controls.
  8. Stress-test generalization. Repeat across prompts, seeds, paraphrases, model sizes, and nearby tasks when available.
  9. Document the claim’s scope. State whether you found a correlated feature, an encoding location, a causal variable, a necessary component, a sufficient component, or a complete circuit.

Common failure modes and fixes

Polysemantic features

Symptom: a neuron or learned feature activates for unrelated examples. Fix: inspect a broader activation sample, compare SAE dictionaries or layers, and test each semantic interpretation separately.

Incomplete circuits

Symptom: the proposed circuit works on discovery prompts but fails on paraphrases or ablation combinations. Fix: search for parallel paths, include upstream and downstream components, and validate the joint circuit on held-out data.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Correlated but unused representations

Symptom: a probe or feature predicts the label, yet changing it does not alter output. Fix: perform targeted patching or subspace intervention and distinguish encoding from causal use.

Benchmark-specific artifacts

Symptom: a method appears excellent on one task but not another. Fix: report the exact models, tasks, layers, datasets, and metrics; do not generalize a conditional ranking to all architectures.

Coherent explanations with no behavioral effect

Symptom: a visualization tells a convincing story, but ablation leaves behavior unchanged. Fix: treat the visualization as a hypothesis generator, investigate redundancy and compensation, and revise the explanation until interventions support it.

Overly aggressive masking

Symptom: a sparse mask preserves one output while damaging general competence. Fix: evaluate multiple outputs and unrelated tasks, tune the fidelity–sparsity trade-off, and report the mask objective and regularization.

How to report an alternative-to-neurons study

  • Name the model architecture, checkpoint, tokenizer, layer range, and precision.
  • Describe the dataset, labels, prompt format, train/evaluation split, and negative controls.
  • Identify the unit of analysis: neuron, SAE feature, DAS subspace, component, edge, circuit, weight pattern, or concept.
  • State the discovery method and every selection threshold or optimization objective.
  • Separate correlation, decodability, localization, causal effect, necessity, sufficiency, and completeness.
  • Give intervention locations, patch sources and targets, ablation rules, output metrics, and effect sizes.
  • Report failures, redundant paths, task-specific limitations, and conditions under which the explanation does not transfer.

The strongest alternative to neuron-level analysis is therefore not a single replacement. It is a layered investigation: use feature or concept methods to find representations, pathway methods to organize them, and causal interventions to determine which parts actually drive the behavior. Weight and interaction analyses fill gaps when activations or explainer models are insufficient.
