AI model collapse is a potential failure mode in which generative models are trained on outputs from earlier generations of models, allowing errors and omissions to accumulate. Over repeated cycles, parts of the original data distribution—especially less common examples—can become underrepresented or disappear. The effect depends on how the training data are assembled; it does not mean that every use of synthetic data damages a model.

How AI model collapse happens

In the foundational Nature paper, Shumailov and colleagues define model collapse as “a degenerative process affecting generations of learned generative models, in which the data they generate end up polluting the training set of the next generation.” The definition describes a recursive training loop, not a one-off use of generated content.   1. A model learns an approximation of patterns in its training data.
  2. It generates new examples from that learned approximation.
  3. Those examples are used to train a successor model, either alone or alongside original data.
  4. If the process repeats, errors and omissions in generated examples can influence later training sets too.

The risk is especially notable for the “tails” of a distribution: rare but valid examples that appear infrequently in the original data. If those examples are missed or blurred in generated samples, a later model may learn an even narrower approximation. The foundational study describes this loss under its recursive-training conditions; it does not establish that any synthetic example will cause this outcome.

What researchers mean by “collapse”

The term is not used consistently across AI research. A 2025 position paper reports eight definitions across 28 publications and groups them into three broad kinds of claim. That variation matters: two papers can both use the label while measuring different effects. See the position paper.

Meaning of “collapse” What is being examined
Degraded real-data test loss Whether a model performs worse on real data under the study’s chosen evaluation.
Deformation of the real-data distribution Whether generated-data recursion changes which kinds of examples are represented or learned.
Changed scaling behavior Whether the relationship between training scale and performance changes, including reported loss of scaling or skill unlearning.

A 2024 ICML paper examines synthetic-data decay through scaling laws and reports experiments involving an arithmetic task and Llama 2 text generation. Its findings concern those tested settings and outcomes, rather than a universal definition of collapse. Read the ICML paper.

Does synthetic data always make AI worse?

No. The training-data mixture and the way earlier data are handled make a difference. A 2024 statistical analysis distinguishes fully synthetic recursion from training that continues to include original data. It finds collapse in the fully synthetic case it analyzes and reports that the amount of original data matters when real and generated samples are mixed. These are conclusions from the paper’s statistical and model experiments, not a guarantee about every pipeline. Read the statistical analysis.

The 2025 position paper also challenges broad predictions drawn from experiments in which each generation is trained entirely on synthetic data and earlier data are discarded. It argues that those assumptions do not necessarily match common frontier-lab pretraining practice, which may retain real data, use larger datasets, and improve data quality. This is an argument about how to interpret experimental conditions—not proof that collapse cannot happen.

  • Fully synthetic recursion: a study may replace the previous generation’s data with generated samples.
  • Mixed training: original examples remain in the dataset alongside generated ones; the amount and quality of retained original data can affect the outcome.
  • Evaluation: results depend on the model, dataset, benchmark, and failure criterion used.

What current mitigation research shows

A 2026 npj Artificial Intelligence study introduced confidence-aware loss methods, including truncated cross-entropy and focal loss, and evaluated them in recursive-training experiments involving language models and other model types. The authors report more than 2.3× longer time to failure than their cross-entropy baseline under the study’s evaluation framework. This is an experiment-specific comparison, not a general guarantee for deployed systems or a measure of how prevalent model collapse is. Read the ForTIFAI study.

How to interpret a claim about model collapse

When a paper or article says a model “collapsed,” check what that word means in that specific claim:

  • What was measured? Real-data test loss, distribution change, scaling behavior, or another defined outcome?
  • What was in the training set? Was it entirely generated, or mixed with retained original data?
  • What happened between generations? Were earlier real examples discarded, kept, or supplemented?
  • What was evaluated? Which models, datasets, benchmarks, and failure criteria were used?
  • How broad is the conclusion? An experimental demonstration is not, by itself, evidence of inevitable collapse or its prevalence in real-world training.

The papers cited here establish possible failure mechanisms and report outcomes under specified experimental setups. They do not establish a broad real-world prevalence estimate for model collapse.
