Neither sparse retrieval nor dense embeddings are automatically better for vernacular search. Traditional sparse methods such as BM25 are strong when a query and document share important words; dense embeddings can help when relevant passages use different wording. For a search system that needs both exact local terms and semantic matches, test a hybrid approach alongside each method on queries from the target users and language varieties.

What “sparse” and “dense” mean in search

The terms describe different ways to represent and retrieve text, not a universal ranking of quality. A sparse representation has many possible dimensions but relatively few nonzero values. A dense embedding is typically a fixed-length learned representation used to find nearby items by similarity.

Traditional sparse retrieval: BM25 and TF-IDF

BM25 and TF-IDF give weight to informative terms shared between a query and a document. In practice, traditional lexical search commonly uses an inverted index: it can identify documents containing query terms without comparing every document as a dense vector. The matching path is visible in the terms and weights that contribute to a result, which can make analyzer behavior easier to inspect.

This approach is reliable for literal overlap, but it does not understand a paraphrase merely because it has the same meaning. If the query uses a local spelling that is absent from the document, lexical matching may miss it unless the search pipeline bridges the difference.

Learned sparse retrieval is a separate category

“Sparse vectors” can also mean learned sparse retrieval, including neural sparse models such as SPLADE. These systems produce sparse token-associated weights and may encode semantic signals; they are not interchangeable with BM25 or TF-IDF. OpenSearch documentation describes neural sparse search as token-weight pairs stored in a rank-features index. It also distinguishes this from dense vector search, whose memory and CPU requirements can be notable. Those are architectural tendencies, not universal cost rankings: actual resource use depends on the model, index, corpus, hardware, and query volume.

Dense embedding retrieval

An embedding model maps text into a learned vector space. Search finds documents whose vectors are close to the query vector under the system’s similarity method. When the model has learned the relevant relationship, this can retrieve a passage even when it uses different words from the query. But similarity is only useful if the model represents the language variety, script, and domain well enough; a high similarity score is not proof that a passage answers the question.

How the approaches differ for vernacular queries

Vernacular search may involve local vocabulary, dialect forms, spelling variation, diacritics, inflection, transliteration, code-switching, or languages that appear less often in model training data. These features affect both retrieval lanes, but in different ways.

Local spellings, diacritics, and scripts Depends on tokenization, normalization, vocabulary, and analyzer rules. Depends on the model’s training and language coverage. Evaluate each language-specific form; success in one lane does not establish coverage in the other.
Morphology and code-switching Depends on how the analyzer handles word forms and mixed-language text. Depends on whether the model represents the forms and languages together effectively. Include real mixed-language and inflected queries, not only standardized examples.
Compute and index design Traditional inverted-index methods are mature; learned sparse methods have different costs. Approximate-nearest-neighbor search has memory and compute considerations. Measure the complete pipeline and the cost of maintaining both indexes.
Debugging and tuning Token matches and analyzer behavior can often be inspected directly. Similarity may be harder to explain; model behavior and nearest neighbors need inspection. Account for fusion settings and candidate depth as additional tuning work.

Normalization is not a magic fix. Whether to normalize diacritics, preserve distinctions, add character n-grams, use synonyms, support transliteration, or expand queries depends on the language and task. A transformation that helps match spelling variants can also collapse forms that users consider distinct, so judge it with speakers or target users.

When to combine sparse and dense retrieval

A hybrid approach is worth testing when users need both exact-term matching and semantic coverage. Google Cloud describes hybrid search as combining sparse and dense results; Azure AI Search documents simultaneous full-text and vector queries whose results are merged using reciprocal-rank fusion (RRF). Qdrant’s hybrid-search example stores a dense vector and a sparse BM25 vector for an item and supports querying them together.

Do not add raw BM25 scores to embedding similarity scores as if the numbers shared a scale. They come from different scoring spaces. RRF is a documented alternative: it combines ranked lists using each result’s position rather than treating their raw scores as directly comparable. The resulting ranking still needs evaluation; fusion can add useful candidates, but it can also change ordering in unhelpful ways.

Hybrid retrieval has a cost: there are more signals, indexes or pipelines, and settings to maintain. Candidate depth and fusion behavior need tuning, and language-specific failures can remain in either lane. A hybrid design is a testable option, not a guarantee that one method’s weakness disappears.

How to choose for a real vernacular search system

Compare the same query set across a traditional sparse baseline, a dense-only system, and a fused hybrid baseline. If learned sparse retrieval is under consideration, evaluate it as its own candidate rather than assuming BM25 results predict its behavior.

  1. Build a representative judged query set. Work with fluent speakers or target users. Include exact names and rare local terms, alternate spellings and diacritics, code-switched queries, paraphrases, and examples across the language varieties the system is expected to serve.
  2. Include queries with no relevant result. These cases reveal whether semantic retrieval returns confidently similar but incorrect neighbors when the answer is absent.
  3. Run each retrieval lane on the same corpus and queries. Compare BM25 or the selected sparse model, dense-only retrieval, and a hybrid that merges ranked results. Keep preprocessing and test conditions documented so that differences are interpretable.
  4. Judge retrieval quality for the task. Use an appropriate ranking or recall measure and inspect results, especially for exact-term and local-variant queries. Aggregate scores alone can hide a poor result for one language variety.
  5. Measure operations as well as relevance. Record latency and resource use under representative conditions, and account for the complexity of maintaining models, indexes, analyzers, and fusion settings.
  6. Review failures by language variety and query type. Decide whether a miss calls for analyzer changes, normalization, transliteration or expansion, a different model, or adjusted hybrid behavior. Re-test changes against the same judged cases.

There is no portable numerical advantage that settles sparse versus dense retrieval for vernacular search. The relevant result depends on the language variety, corpus, model, indexing choices, query mix, and task; a general label such as “multilingual” does not establish support for every dialect or low-resource language.

What one Yorùbá-English example shows—and does not show

The 2026 LoResLM paper in ACL Anthology describes bilingual English/Yorùbá retrieval for medical labels. Its setup used a Yorùbá-specific BERT model and multilingual E5 for Yorùbá, and MiniLM for English. The authors’ hybrid baseline combined dense retrieval with BM25 using Unicode-aware tokenization; they also repeated cleaned generic drug names in the BM25 query to prioritize exact matches.

This is a useful illustration of language- and domain-specific design: Unicode handling and exact-name emphasis addressed needs in that system. It does not establish that hybrid retrieval always wins, or that these models and choices will work for other dialects, scripts, domains, or languages.
