Measure recommendation quality across three separate dimensions: whether the list matches a user’s needs, how much its items differ from one another, and how quickly the serving system returns it. Report the definition, evaluation population, list cutoff, and serving conditions for each result. No single metric establishes that recommendations are good overall.
Start with the recommendation pipeline
A common recommendation system has three stages: candidate generation narrows a large catalog, scoring orders a smaller set, and re-ranking applies final constraints such as diversity or freshness. The stages serve different purposes, so measure them separately as well as evaluating the final list delivered to users. Google describes this architecture and the role of each stage in its recommendation-system overview.
- Candidate generation: Check whether the candidates include enough potentially relevant items. If relevant choices never enter the candidate set, a later ranker cannot recover them.
- Scoring: Evaluate how well the model orders the available candidates.
- Re-ranking: Check the final ordering and any constraints applied to it, such as genre variety.
- End-to-end serving: Measure the complete path that produces the list, not just an isolated model stage.
Measure relevance in the ranked list
Relevance measures compare a ranked list with explicit judgments or interaction-derived labels. Choose the label definition and evaluation population first, then report the metric at a stated cutoff k—the number of top-ranked items included. Microsoft’s Recommenders evaluation documentation describes commonly used ranking metrics:
- Precision@k: The proportion of the first k recommendations labeled relevant. It answers how much of the displayed list is relevant.
- Recall@k: The proportion of the relevant items in the evaluation set that appear in the first k. It emphasizes how many relevant options the system retrieves.
- NDCG@k: A relevance measure that discounts relevant items lower in the ranked order, reflecting that position matters.
- Mean average precision (MAP): Aggregates average precision across evaluation cases, accounting for the positions of relevant items in each ranked list.
These metrics answer different questions; report one or more that match the product’s purpose rather than treating them as interchangeable. Make comparisons only when the relevance-label construction, candidate pool, cutoff, and user or request population are comparable. Offline labels are proxies for user value, not proof that a change caused users to benefit.

Measure diversity—and define it
Diversity has no single universal score. One operational approach calculates average within-list dissimilarity across users. The result depends on how item similarity is defined: for example, it may use item co-occurrence or item feature vectors, as described in Microsoft’s evaluation documentation. State the item representation, similarity or distance measure, aggregation method, and evaluated population whenever reporting a diversity value.
Re-ranking can encourage variety using genre or other item metadata. Google cautions that repeatedly selecting the closest embedding neighbors can yield overly similar recommendations; diversity constraints can address that tendency. A higher dissimilarity score, however, does not by itself show that the list is more useful. Read it alongside relevance and user outcomes.

Keep novelty distinct from diversity
Novelty concerns how uncommon an item is, not how different the items in one list are from one another. Microsoft’s documentation describes an interaction-frequency-based measure: an item’s novelty is the negative logarithm of its share of historical interactions. Under that definition, less frequently interacted-with, long-tail items receive higher novelty.
A list can be diverse but mostly popular, or novel without being relevant. If discovery or long-tail exposure matters, report novelty separately and pair it with relevance and appropriate user-outcome measures. Do not interpret novelty alone as evidence of recommendation quality.

Measure latency on the serving path
Latency is a property of the system serving recommendations, not a ranking-quality score. Record elapsed time on the live or representative request path, and specify what the timing includes: candidate generation, scoring, re-ranking, or all of them. Report a distribution rather than only an average; a central tendency can hide slow requests in the tail.
For an interpretable result, state the request population, measurement window, workload, hardware or serving conditions, and reported percentiles. Compare latency only under comparable conditions. The cited recommendation guidance does not establish a universal acceptable latency target or a required percentile; set targets from the product’s response-time requirements and observed workload.

Compare systems without hiding trade-offs
When comparing model versions or ranking strategies, hold the evaluation setup steady and show the dimensions separately. A compact report can use a table such as this, with actual results and their conditions filled in:

Engagement metrics need interpretation too. Google’s guidance gives clickbait and excessively long video recommendations as examples of undesirable results that can arise when a system optimizes a narrow objective. Avoid collapsing relevance, diversity, novelty, latency, and outcomes into an undocumented weighted score: the appropriate trade-off depends on the product, and the cited sources define no universal weighting formula.
