Evaluate the complete recommendation experience—not just the model—before deployment. Define what the system is meant to do, set use-case-specific quality and risk criteria against a credible baseline, test outcomes across relevant groups, probe generated content and adversarial behavior, and verify results in context. A benchmark score alone cannot establish that a recommender is ready to launch.

1. Define the system and the decision it supports

Start by describing the actual user-facing task: what is being recommended, to whom, and in what setting? A system suggesting films, ranking job candidates, recommending health information, or selecting products can create very different benefits and harms. Identify affected people—including people who may be excluded from or indirectly affected by recommendations—and write down outcomes the product must not produce.

Map the full recommendation path

Include every component that can change what a user sees or does: the candidate pool, ranking or selection logic, prompts, generated explanations or dialogue, and safeguards. Evaluate these together. A relevant item can still be presented misleadingly, and a sound explanation cannot fix a harmful or systematically poor selection.

Generative recommenders do not all use the same architecture. They may be ID-driven, based on large language models, or multimodal; the survey Recommendation with Generative Models reviews these families and their applications. Record which approach your system uses and what it generates, because those details determine what needs to be probed.

Specify intended use and unacceptable outcomes

State who the system is for, which decisions or actions it may influence, and where human judgment remains necessary. Translate that into concrete failure cases—for example, a recommendation that is irrelevant, materially misleading, unsafe, or unfairly limits a group’s access to an opportunity. These are examples to adapt, not a universal policy list: product and domain owners must define what counts as harm in their context.

2. Set launch criteria before reviewing results

Choose measures that reflect the intended product outcome and matter to users. A ranking-quality measure may help assess ordering, while task completion, user feedback, or another outcome measure may be more relevant to the product’s purpose. Do not treat engagement as a proxy for user benefit without establishing that the relationship holds for this use case.

Compare against a meaningful baseline using a comparable user population, candidate set, and time window. Document those conditions so a reported gain cannot be explained by changing the test population or available items. Set risk thresholds and identify who has authority to accept residual risk before seeing the results; otherwise, teams can be tempted to redefine success after a disappointing test.

NIST’s Generative Artificial Intelligence Profile (AI 600-1) calls for use-case-appropriate measures and documentation of the validity and uncertainty of pre-deployment evaluations. It does not set one pass mark for every recommender. There is likewise no universal quality, fairness, safety, sample-size, or online-experiment threshold established for an unspecified application. Choose thresholds based on the intended use, plausible harms, baseline, and operational context.

3. Measure quality and allocation across groups

Report aggregate task quality, then examine performance for relevant demographic groups and subgroups. If the recommender allocates exposure, services, resources, or opportunities, measure those allocation outcomes as well as the quality of the recommendations people receive. A system can perform well on average while delivering poor service to a subgroup or concentrating opportunities among a narrow set of people.

  • Check the evidence base: Review data completeness, representativeness, balance, and coverage of relevant groups. Note where missing or sparse data makes a result uncertain.
  • Inspect proxies and intersections: Consider whether inputs act as proxies for sensitive characteristics, and whether outcomes differ for intersecting groups that an aggregate comparison can hide.
  • Choose measures for the harm: Explain why each group-level measure represents the benefit or risk at issue. NIST discusses measures including demographic parity, equalized odds, and equal opportunity for relevant categorical or numeric pipelines, but no single parity statistic determines whether a recommender is fair.
  • Involve relevant people: Work with domain experts and affected communities to define meaningful outcomes and interpret trade-offs in context.

4. Test generated recommendations, explanations, and safety

Build an evaluation set tied to the application’s content policies and actual patterns of use. Test the recommendation itself and any generated explanation or conversation around it. The latter can introduce risks of its own: for instance, an explanation may misrepresent why an item was selected or state more certainty than the system can support.

Include ordinary, harmful, and adversarial cases

Cover routine user requests as well as explicit policy-violating prompts and indirect or subtly adverse ones. Vary wording, tone, topic complexity, and identity-related language so the test is not limited to obvious trigger phrases. Use held-out material where possible for assurance, and document possible overlap between evaluation examples and training data.

Public benchmarks can supplement application-specific tests, but they are not proof of fitness for a particular deployment. Google’s Responsible Generative AI Toolkit, last updated November 11, 2024, describes examples including BOLD, with 23,679 English text-generation prompts across five domains; CrowS-Pairs, with 1,508 examples across nine bias types; and TruthfulQA, with 817 questions across 38 categories. These are dataset descriptions, not performance results for your recommender. Google also cautions that results can vary by implementation and that a saturated benchmark may no longer distinguish systems effectively.

Red-team the integrated application

Use structured red-team exercises to probe weaknesses in the system as deployed, rather than testing only an isolated model. Google’s guidance identifies risks to examine where relevant, including prompt injection, poisoning, crafted adversarial inputs, prompt extraction, training-data exfiltration, model extraction, membership inference, denial of service, and computation-cost attacks. Prioritize probes according to the system’s design and plausible impact; bring in independent experts when the risk and available resources warrant it.

5. Check that the evaluation evidence is trustworthy

A measurement is useful only if it measures the intended concept under conditions relevant to deployment. For each result, record the population, data, candidate set, time window, assumptions, uncertainty, and known limitations. Investigate training-test contamination and keep assurance data held out where possible. If a metric is only an imperfect proxy for user benefit or harm, say so rather than presenting it as a direct measure.

Do not collapse unlike evidence into a single score without explaining the trade-offs. When comparing candidate systems or designs, use the same evaluation population and baseline where possible, and review task quality, group-level quality and allocation, adversarial safety, measurement validity, and contextual performance. The available guidance does not establish a universal weighting among these dimensions; the accountable decision-makers must justify any weighting for their application.

6. Evaluate in context and prepare for deployment

Lab tests and red teaming should be paired with field or contextual evaluation. NIST’s Assessing Risks and Impacts of AI (ARIA) program treats technical and contextual robustness as extending beyond accuracy and performance. Its current program page notes that recommender systems may be considered in future iterations; it is not a recommender-specific testing protocol today.

Before launch, establish how the deployed system will be observed and how concerns will be acted on. Define telemetry appropriate to the use case, review and escalation ownership, user feedback or appeal channels, and conditions that trigger rollback or re-evaluation. NIST AI 600-1 also recommends feedback processes, impact studies, and ways to identify emergent risks. A deployment plan should say who reviews new evidence and what action they can take—not merely that monitoring will occur.

What a deployment decision should establish

  • The evaluated system matches the intended use and includes the components that shape user-visible results.
  • Predefined criteria show how quality and risk were assessed against a credible baseline, with limitations and uncertainty documented.
  • Group-level service and allocation outcomes have been examined using measures justified for the application.
  • Application-specific safety tests and red-team findings have been reviewed, with unresolved risks assigned to accountable owners.
  • Contextual evaluation and post-launch feedback, escalation, and rollback processes are ready.

If material evidence is missing or a critical risk has no owner or mitigation, the results do not by themselves justify deployment. A limited or staged release may be considered only if its scope, safeguards, monitoring, and stop conditions are explicit and appropriate to the potential impact.
