To collect useful sensor data for TinyML, define the event you want to recognize, capture examples that reflect real operating conditions, label them consistently, and test the complete sensor-to-model pipeline on the target device. Sensor data is application-specific: a gesture classifier, a speech recognizer, and a person detector need different sensors, capture protocols, labels, and segmentation.

1. Define the task before collecting data

Write down what the model must detect and what it should do when the target event is absent or unclear. Specify the sensor signals available to the device, the expected operating conditions, and how annotators will decide where each label begins and ends. This turns “collect some sensor data” into a repeatable capture plan.

For a motion classifier, for example, labels might distinguish specific gestures and include an “Unknown” or background class. The 2021 TensorFlow Blog tutorial uses five boxing gestures plus an “Unknown” class, and records context such as subject and which glove is used. That example illustrates why labels and metadata belong in the plan together: who performed an action or where a device was worn can affect the signal even when the intended label is unchanged.   • Define positive events, background or negative cases, and any class for ambiguous or out-of-scope input.
  • Record metadata that may change the signal or its interpretation, such as subject, device placement, environment, or operating state.
  • Use the same label definitions and metadata values across collection sessions.

2. Match the sensor and board to the phenomenon

Choose a sensor that can observe the target event, then check that the board exposes it to the capture firmware and eventual inference application. An IMU can capture motion; a microphone captures audio; a camera captures images. These are different input problems, not interchangeable ways to collect a generic TinyML dataset.

The TensorFlow-hosted SensiML tutorial demonstrates gesture collection with an Arduino Nano 33 BLE Sense and its onboard 9-axis IMU. The tutorial reports a 64 MHz Cortex-M4, 1 MB flash, and 256 KB RAM for the board in 2021; treat those as specifications reported at that time and verify the current board revision before selecting hardware. TensorFlow Lite Micro’s examples include accelerometer-based gestures, microphone-based speech recognition, and camera-based person detection. Its platform guidance also makes clear that connecting and supporting peripherals is work beyond the inference library: a project needs a suitable board toolchain, SDK, and sensor integration. 3. Choose how sensor readings reach the capture system

The capture route should suit the range, bandwidth, power budget, and whether you need to monitor recordings live. In the SensiML example, the board streams over BLE to the SensiML Open Gateway, and a capture application connects to that gateway over TCP/IP to record the data. The same tutorial identifies Wi-Fi, BLE, serial, LoRaWAN, and local SD-card recording with later transfer as possible approaches; it does not benchmark them or establish a universal best choice. Whichever route you choose, verify that recordings arrive intact and remain associated with the correct label and metadata. A reliable transfer path does not fix a vague label protocol, and a carefully labeled capture is not useful if its context is lost.

4. Capture examples with repeatable labels and context

In the SensiML workflow, the operator selects a label and metadata, records examples, and saves the capture. The recordings can then be inspected and annotated. Use a protocol that makes those choices consistent: define label boundaries, use a controlled set of metadata values, and keep the capture procedure consistent enough that one session can be compared with another. Collect examples under conditions the deployed system is expected to face, rather than only under a single convenient setup. For instance, if placement or a person’s movement changes an IMU signal, record that context so you can tell whether the model is learning the intended gesture or incidental differences. This is practical dataset design, not a promise that any particular collection volume will guarantee accuracy.

5. Segment the stream for the task and device

A sensor stream usually needs to be divided into portions that the classifier can process. Segmentation determines which part of the stream enters the model, and the device’s buffer limits constrain how much data can be held at once. In the SensiML tutorial, simple sliding windows can split a discrete event across window boundaries or trigger classifications during periods when no target event is happening. Choose window duration, overlap, or event-aware segmentation based on how long events last and how they appear in actual recordings. Inspect segments around event starts and ends, background periods, and transitions between labels. Then check that the chosen segmentation fits the device’s buffering and inference constraints; the cited sources provide no universal window size or sampling frequency.

6. Train, validate, and deploy on the intended hardware

Once recordings are labeled and prepared, train and validate the model, generate firmware, and test the complete pipeline on the target device. TensorFlow Lite Micro requires a model small enough for the target and operations supported by its implementation. The board’s toolchain, SDK, and peripheral integration also affect whether the deployed application can read the sensor and run inference as intended. Validation should reflect intended use, including relevant people, placements, environments, and background conditions. A good training result alone does not establish that the physical sensor, capture settings, segmentation, firmware, and inference behavior work together on the edge device.

How much data should you collect?

The cited tutorials do not establish a universal recording count, dataset size, sampling rate, accuracy target, or model size for all sensor tasks. Their examples are task-specific, so do not copy a gesture or audio setup as a general prescription. Collect enough varied examples to evaluate the conditions that matter for your application, then use device-side testing to identify gaps in the data or pipeline.
