A minimal feature store has two retrieval paths: an offline path for historical, point-in-time-correct training data and an online path for current values looked up by entity during inference. You can see the pattern locally with Feast’s tutorial setup, which uses Parquet for offline data and SQLite for online values. This is a learning implementation—not a production deployment or a replacement for a mature platform.

What a feature store does

A feature store gives the workflows that produce and consume model features shared definitions and retrieval paths. Rather than letting each training job and serving service independently decide what a feature means and how to find it, clients refer to managed feature definitions. Feast uses a registry to persist those definitions for discovery, and its SDK provides ways for clients to request features.

The core distinction is temporal. Training needs historical values as they were available at each example’s prediction time. Inference generally needs the latest available values for the entity being scored. Feast describes its training export as: “Feast exports a point-in-time correct training dataset based on the list of features and entity dataframe provided by the model training pipeline.”

The smallest useful architecture

Definitions and registry

Define the features a client can request, the entity they belong to, their schema, and the source of their data. An entity is the key used to associate feature values with a real-world object—for example, a customer ID. The registry makes feature definitions discoverable; it is not itself the historical or online feature data.

Offline data

Keep historical records with an entity key, an event timestamp, and feature values. This path supports training-data retrieval across time. Feast’s local quickstart uses Parquet as its offline store, a convenient tutorial choice rather than a universal recommendation for production.

Materialization and online data

Materialization transfers selected feature values from the offline path into the online store. Feast’s documented flow has a user or scheduler run materialization; deploying a model is a separate responsibility. The online path keeps the latest materialized value for each entity and feature so an inference service can retrieve it. The local quickstart uses SQLite for this store.

Two clients, two questions

  • Training: “What feature values were available for this entity at this example’s event time?”
  • Inference: “What are the latest online values for this entity?”

Feast’s architecture recommends precomputing features so serving can be a lightweight database lookup instead of doing substantial feature work on each request. This makes freshness and the operation of ingestion and materialization part of the serving design; it does not establish a latency guarantee.

Build a local example with Feast

Feast’s official quickstart is a concrete reference for the flow: local Parquet offline data, historical retrieval for training, materialization, and SQLite-backed online retrieval. Because tutorial commands and provider support can change, pin a Feast release and follow the quickstart for that release rather than treating unversioned commands as stable:

Feast quickstart

1. Create a small changing feature source

Start with a table whose rows can be inspected by eye. Include an entity key, an event timestamp, and at least one feature that changes over time. For example:

The timestamps describe when those feature values became valid in the source. A timestamp for each observation in the training set is equally important: without it, the retrieval cannot distinguish the value available then from a later update.

2. Define the entity, schema, and source

In Feast, configure an entity keyed by customer_id, describe the feature fields and their types, and associate a feature view with the source data and timestamp column. Use the quickstart’s version-matched project files and APIs for the exact declarations. The important design choice is that the source’s entity key and event-time column match the data you will query.

3. Retrieve historical values for training examples

Build an entity dataframe with one row per training example, including the entity key and the example’s observation timestamp. Request the needed feature references through Feast’s historical retrieval path. For each example, the eligible feature record is the latest matching record at or before that timestamp, subject to any time-to-live (TTL) policy you configure.

For C17 at 2025-01-11, the appropriate risk_score is 0.18, not 0.31: the latter record had not arrived at the example’s time. Using the latest value without respecting the observation timestamp leaks future information into training and can make offline evaluation misleading. Choose TTL as a data-freshness policy appropriate to the feature; there is no universal value implied by this example.

4. Materialize values for online use

Run the quickstart’s materialization flow over a bounded time interval that includes the sample records. This loads the selected offline values into the local online store. The interval and schedule are explicit operational choices: materialization does not mean that every source update appears online automatically at the same moment.

5. Make an online lookup

Use Feast’s online retrieval API with the entity key and requested feature references. For C17 after materializing both rows, an online lookup returns the latest materialized risk_score, 0.31. That result is correct for the current-value inference path, while the earlier training example correctly receives 0.18. The distinction is intentional, not a mismatch between stores.

What this prototype does—and does not—demonstrate

Parquet and SQLite make the local flow easy to inspect, but the example does not establish production throughput, availability, security, access-control behavior, or operational guarantees. Offline and online stores serve different workload requirements: historical retention and query semantics on one side, current-value reads and writes on the other. A real design should compare those requirements alongside freshness and materialization behavior, point-in-time semantics, operating complexity, and where transformations execute.

Feast’s architecture documentation describes batch and streaming sources as relying on a separate transformation engine in the architecture discussed there. It also describes support for on-demand and streaming transformations, while batch transformation support depends on a separate engine. Treat these capabilities as version- and architecture-specific, and confirm them in documentation matching the Feast release you use. Precomputation keeps the request-time serving path simple, but requires a dependable process to ingest, transform, and materialize fresh values.

The model-serving system that calls the online store and uses its response is outside this minimal feature-store flow. Feast provides feature definitions and retrieval mechanisms; it does not, by itself, deploy the model or define the complete inference service.
