To optimize test execution in continuous integration (CI), decide separately which tests to run and in what order to run them. Selection can save runtime by omitting tests, but risks missing failures; prioritization can surface useful failures sooner while retaining a broader run. Start with a measurable history- and change-aware baseline, then test whether machine learning (ML) improves results on your own later CI builds. An AI model is not automatically faster, more reliable, or more effective.

How do I prioritize tests in a CI pipeline?

First define what “better” means for your pipeline. If the goal is to tell developers about likely regressions sooner, order tests to bring useful failure signals forward. If the goal is to finish within a strict budget, select a subset as well—but treat that as a separate coverage decision. A staged pipeline can use both: run a time-bounded, high-value set before submission, then run a broader suite after submission.

That distinction matters because test-case prioritization orders tests, while test selection chooses a subset. A 2020 systematic mapping study of CI prioritization literature found that 80% of the 35 approaches it identified were history-based. That figure describes the study’s sample, not the current market or every project. The study also found that time and the number or percentage of faults detected were common evaluation measures. Choose the control that matches the constraint

Google’s 2014 study describes regression-test selection in a pre-submit phase and prioritization after submission, and reports cost-effectiveness improvements in its empirical study. Treat it as an example of a staged design, not a guarantee that the same arrangement will improve every project. Read Google’s study.

How can I reduce regression test execution time?

Separate total runtime from time to useful feedback. Reordering alone may reduce the time to the first actionable failure without shortening the full run. Selection or parallel execution may reduce wall-clock time, but each has different costs: selection can leave gaps in coverage, while parallelism consumes more concurrent compute and can introduce resource contention. Measure the metric tied to the problem rather than treating “faster” as a single outcome.

Record a baseline before changing the pipeline

For each CI build, retain enough information to replay the decision and evaluate its consequences:

  • Test identity, duration, outcome, and whether the result was later classified as flaky or as a product failure.
  • Commit or change context, including changed components and available links between code areas and tests.
  • Which tests were selected, their order, and the pipeline stage in which they ran.
  • Elapsed time to the first useful failure, total suite time, compute consumed, and which tests were deferred or omitted.

Define “useful failure” with the team: for example, a failure that points to a reproducible regression rather than a known infrastructure problem or intermittent test. Without a stable definition, a strategy can look successful by moving noisy failures earlier.

Set separate pre-submit and post-submit budgets

Decide how much latency and compute the team can spend at each stage. A pre-submit run should prioritize timely feedback; a later run can restore broader coverage for tests deferred earlier. Specify when deferred tests run, how failures are surfaced, and what happens if a later run finds a regression after a change has already merged. If no later stage reliably recovers omitted coverage, selection is a deliberate coverage reduction, not merely an optimization.

Should I use AI or machine learning for test case prioritization?

Compare candidate methods against a simple baseline. In its 2026 abstract, the authors of DANTE: Data-Driven Test Case Selection and Prioritization for Long-Running Test Suites caution that “simple heuristics, such as prioritizing recently failed or fastrunning tests, often outperform sophisticated machine learning (ML) approaches, which incur high training costs and suffer from distribution shift.” Read the DANTE paper.

DANTE evaluated its method on the Java portion of the Long-Running Test Suite dataset, whose abstract describes more than 21,000 CI builds and multi-hour suites. The paper reports favorable comparisons with selected heuristics and ML baselines, including robustness to flaky tests. Those results are evidence about that evaluation, not proof of a universally best method across languages, CI systems, or organizations.

Compare approaches against the same objective

Approach What it can use What to watch
Fixed or broad baseline A stable ordering or broad run with little historical data. Easy to audit, but may not use recent failure or change signals effectively.
History-based heuristic Recent failures, prior outcomes, or execution duration. Requires trustworthy history; recent failure does not guarantee a test is relevant to the current change.
Change-aware selection or ranking Changed code or test artifacts and known relationships between them. Depends on the quality and coverage of change-to-test mappings; unmapped changes need a fallback.
ML-based ranking or selection Historical outcomes and potentially change, duration, or other project signals. Needs data, maintenance, and checks for distribution shift; added complexity must earn its place in evaluation.

This is a decision framework, not a claim that each cited study compared every approach on every axis. For each candidate, assess feedback speed, fault detection, runtime and compute budget, change relevance, reliability under flaky tests, cold-start behavior, and operational effort.

Evaluate on later builds, not shuffled hindsight

  1. Choose a target outcome, such as time to a confirmed regression signal within a fixed CI budget, and define how false or flaky failures count.
  2. Build a simple baseline from recorded duration, recent outcomes, and change context. Keep a broad run as a reference point.
  3. Compare candidate strategies using chronological splits or later builds where possible: use earlier builds to derive a ranking, then assess it on builds that occur afterward.
  4. Report the results at the budget the pipeline can actually afford. Include missed or deferred failures, runtime, compute use, and flaky noise—not just how early the first failure appeared.
  5. Re-evaluate as code, tests, and failure patterns change. Keep a fallback if the candidate model or its inputs are unavailable.

Chronological evaluation helps avoid letting future test behavior influence a ranking intended for earlier builds. It does not guarantee that future behavior will match the evaluation period, so continue monitoring after rollout.

How should you handle new tests and cold starts?

A newly added test has no execution history. A history-dependent method may rank it poorly, inconsistently, or not at all unless the pipeline defines what to do. The IEEE 2023 paper on reinforcement learning for test prioritization notes this cold-start issue for newly added tests. The CI prioritization mapping study also provides context on the prevalence of history-based approaches.

Use a deterministic fallback until the test has enough recorded executions: include new tests in a broad baseline, or use available changed-area relevance when the relationship is reliable. Do not silently equate “no history” with “low priority.” Track when a fallback was used so its results can be evaluated separately.

How do I handle flaky tests when prioritizing regression tests?

Track flaky outcomes as a reliability signal distinct from a confirmed product regression. Otherwise, an algorithm that promotes recent failures can repeatedly move intermittent failures to the front, making feedback noisier rather than more useful. Record repeat outcomes where feasible, preserve the distinction between test failure and infrastructure failure, and avoid treating every red result as equally informative.

Microsoft Research’s ICSE 2020 study, A Study on the Lifecycle of Flaky Tests, covers six proprietary projects. Its authors state that “asynchronous calls are the leading cause of flaky tests in these Microsoft projects.” They also report cases where developers said they had fixed a flaky test, but the authors’ empirical experiments found the changes did not fix or reduce the frequency of flaky-test failures. These are findings about the studied projects, not a universal cause profile or rate. Read the study.

The same study reports that its FaTB technique reduced runtime by up to 78% in an evaluation of five flaky tests without empirically changing their flaky-failure frequency. That result is limited to the reported experiment; it does not establish the same runtime reduction or effect for other tests or suites. Newer research describes ChaosAPI, which controls nondeterministic API behavior to detect varied flaky-test types; that research description is not evidence that a particular commercial product offers the capability. What changes when the system under test uses machine learning?

For an ML system, ordinary software regressions are only part of the problem. A test plan may also need to detect model-performance regressions and problems caused by interactions among system components. Microsoft Research’s 2022 industry study surveyed 87 people and interviewed 7 senior practitioners; it identifies component entanglement and regression in model performance as testing challenges in ML systems. Keep those findings scoped to the study rather than assuming every ML project has the same testing needs. Read the industry study.

In practice, make the CI objective explicit about which signals matter: code-level failures, model-performance changes, component interactions, or some combination. A ranking optimized only for historical test failures may not prioritize tests that detect a degraded model metric unless that signal is represented in the evaluation and inputs.
