AI can help improve a process only when its inputs capture evidence relevant to the outcome. If a manufacturing system records convenient signals but misses conditions that drive defects, a model may produce precise-looking predictions from an incomplete picture. Start by defining what success and failure mean, then measure the process well enough to judge whether a model—and eventually automation—can help.

Why measurement comes before a model

A model can learn only from information available to it. If an important process variable is never observed, the model cannot directly account for it; poor measurement choices can therefore make an output misleading even when the software is functioning as designed. This is a practical risk, not an explanation for every AI failure: unsuitable objectives, model design, changing conditions, and deployment decisions can also matter.

In a September 28, 2026 article, Aaron Bin Wang describes machine shops adopting monitoring, predictive maintenance, and automated quality tools, then encountering dashboards that miss failures or generate false alarms. His explanation is that captured data may omit changing variables that drive process variation. He argues that measurement, modeling, and automation should be treated as distinct decisions rather than assumed to be one software purchase.

Define the outcome and process boundary

Before choosing sensors, metrics, or software, specify which process and result you want to improve. A useful measure must connect to the task: for example, dimensional consistency, defect occurrence, delay, or a relevant risk. Define where the process begins and ends, what counts as a case, and how success will be compared with a baseline or benchmark.

NIST’s voluntary AI Risk Management Framework 1.0 supports context-specific measurement: it calls for assessing, benchmarking, and monitoring AI risks and impacts, documenting metrics and uncertainty, and using results to inform risk management. It does not prescribe a universal KPI list or require every improvement effort to begin with sensors. NIST says revision of the framework is in progress.

Measure the conditions that can affect the result

In Wang’s machining example, relevant measurements include temperature at meaningful points, fixture repeatability, and in-process dimensional feedback. The point is not to collect every available signal. It is to identify plausible drivers of the outcome and make their measurement reliable enough to support analysis.

  • Relevance: Does the measure plausibly relate to the defined outcome or a known failure mode?
  • Coverage: Are measurements taken at the locations and times where meaningful variation can occur?
  • Repeatability: Are definitions, collection methods, and instruments consistent enough that observed changes are interpretable?
  • Uncertainty: What is known about measurement limits, missing data, and the confidence warranted by the result?

There is no universal set of sensors or process KPIs for manufacturing. Instrumentation depends on the operation and the question being answered; Wang’s examples do not establish a particular sensor brand, calibration specification, or equipment choice.

Build a baseline from the process you actually have

A baseline gives you a reference for deciding whether a change helped. Compare relevant outcomes and conditions before and after an intervention, or against an appropriate benchmark. Keep the comparison tied to the same process boundary and outcome definition; otherwise, a reported improvement may reflect a changed measurement method rather than a better process.

For workflows that already produce usable event records, process mining can help reconstruct how cases move through the process. ProcessMind, a vendor, describes records built around a case identifier, activity, and timestamp. Such logs may support a view of actual paths and delays, but they do not automatically explain why those paths occur or establish that the underlying process is healthy. NIST’s AI RMF Playbook also emphasizes documenting measurement approaches, test sets, metrics, and processes. A baseline is not a one-time box to check: continuing instrumentation and monitoring can reveal errors or emerging risks after deployment.

Choose the simplest model that can be validated

Once the measurements are credible, decide whether a model is needed and what kind. Wang notes that AI is not always the right choice: in a stable operation, a physics-based or statistical approach may be simpler to understand and validate. A machine-learning model is not inherently better merely because it is more complex.

Compare genuine alternatives against the same decision criteria:

  • Whether the method addresses the defined process outcome.
  • Whether its input data are sufficiently reliable, repeatable, and representative.
  • How uncertainty and measurement coverage are handled.
  • How performance compares with a suitable baseline or benchmark.
  • How much explanation and validation the operation needs.
  • What operational consequences follow if the output is wrong.

These are practical comparison dimensions, not a named NIST checklist. NIST’s guidance is to evaluate and document performance, uncertainty, and risk in context rather than assume a technique is effective.

Test before deployment and keep testing afterward

Evaluate a model against observed conditions before relying on it. Choose metrics tied to the intended use, record uncertainty, and compare performance with a relevant benchmark. Testing should continue during operation: NIST recommends pre-deployment testing as well as regular in-operation testing and monitoring. A model that worked under one set of conditions may warrant renewed evaluation as the process or data change.

NIST’s Playbook recommends documenting test sets, metrics, and measurement processes, and instrumenting systems for tracking under organizational governance. Measurement results should inform decisions about whether to continue, adjust, restrict, or stop use.

Automate only when the evidence and controls justify it

A prediction used as advice and a prediction allowed to trigger an automatic action do not carry the same operational consequences. Before closing the loop, define acceptance criteria and decide when outputs require human review or escalation. The appropriate safeguards depend on the workflow and the cost of a mistaken action.

Wang warns that premature automation can accelerate errors. His article recounts, in the first person, a predictive-quality trial that failed when reliable temperature and in-process measurements were lacking; after instrumentation and fixture improvements, he says the model helped detect thermal drift. The manufacturer is unnamed and the account does not provide independent case data, so it should be understood as Wang’s anecdote, not a verified case study or a guaranteed result.

A practical sequence for a manufacturing AI project

  1. Define: Specify the process boundary, target outcome, and relevant failure modes.
  2. Measure: Identify plausible drivers and collect reliable, repeatable data at relevant points.
  3. Baseline: Record current outcomes and conditions using consistent definitions.
  4. Compare: Test whether a simple rule, physics-based or statistical method, or AI model fits the task; evaluate against an appropriate baseline or benchmark.
  5. Govern: Document metrics, uncertainty, test conditions, ownership, and criteria for review or escalation.
  6. Monitor: Continue testing and monitoring in operation, and revisit decisions when evidence or conditions change.

This sequence is a practical way to apply the manufacturing example, not a universal rule that every AI effort must follow an identical order. NIST organizes AI risk management into Govern, Map, Measure, and Manage; its framework informs evaluation and risk management, rather than prescribing this exact process-improvement recipe.
