To reduce GPU memory during AI model inference, first identify whether memory is going to model weights, the key/value (KV) cache, or temporary runtime allocations. Then target the cause: use supported lower-precision weights, limit context length or concurrent requests, choose a memory-efficient attention backend, or offload some model state to CPU memory. These options are not interchangeable, and each can affect speed, output quality, or compatibility.
Find out what is using GPU memory
Inference means loading a model and generating outputs; its memory profile differs from training. During inference, GPU memory can be used by:
- Model weights: the stored parameters. Their memory use depends heavily on the model and weight precision or quantization.
- KV cache: data retained for tokens in the prompt and generated output. Its demand grows with sequence length, and serving multiple active sequences increases the cache workload.
- Temporary allocations: runtime and attention operations can require additional memory beyond weights and cache.
Record your GPU and available VRAM, model checkpoint and parameter count, runtime, weight dtype or quantization, prompt length, generation limit, and number of concurrent sequences. If your runtime exposes peak memory, observe it separately during model loading and generation. This helps distinguish a model that cannot fit at load time from one that loads but runs out of memory as sequences grow.
Choose a fix based on the memory bottleneck
When model weights dominate: reduce weight precision
Quantization stores weights at lower precision and can reduce their memory footprint. Hugging Face illustrates the scale with a 70-billion-parameter Llama 2 model: its inference guide estimates 256 GB for full-precision weights and 128 GB for half-precision weights. These are figures for that guide’s example, not a universal VRAM calculator or a guarantee that a particular setup will fit. See Hugging Face’s inference optimization documentation.

Try a lower-precision or quantized checkpoint supported by your runtime, then compare its outputs on representative prompts and check latency as well as whether it loads. Quantization trades precision for lower weight memory; the effect on output quality and speed varies by model, GPU, and implementation. vLLM likewise describes quantized models as using less memory at the cost of lower precision in its memory-conservation documentation.
When memory grows with sequence length: limit context and concurrency
Longer prompts and generated sequences increase KV-cache demand. In a serving workload, more active sequences also mean more cache to manage. Reduce the maximum context or generation length to the smallest values that still meet the task, and limit the number of requests processed concurrently if the workload permits.

For vLLM, the documented controls include max_model_len and max_num_seqs. Their exact behavior and configuration syntax can depend on the installed version; check the current vLLM documentation rather than copying flags from an unrelated version.
When temporary attention allocations are the problem: check the backend
Attention implementations can differ in the size of intermediate tensors they require. Hugging Face recommends considering FlashAttention 2 or PyTorch scaled dot product attention (SDPA) for memory-efficient attention when the model, GPU, and software stack support them. Check the compatibility requirements for your specific setup before selecting or forcing a backend; an unsupported combination may fail or fall back to another implementation. When the model still does not fit: offload or change the serving setup
Device mapping or CPU offload can place some model state outside GPU memory. That can relieve VRAM pressure, but moving work or data to CPU memory can affect performance. Confirm that your chosen runtime supports the intended offload configuration, then measure the result on your workload.
For multi-request serving, a serving engine’s cache management may also matter. The 2023 PagedAttention paper describes how fragmentation and redundant KV-cache duplication can waste memory in serving, and presents PagedAttention as an approach to managing that cache. This is particularly relevant to concurrent serving; it does not imply that changing engines will reduce memory for every single local generation. Apply changes in a controlled order
- Establish a baseline. Record the GPU, model, runtime, precision, context and generation limits, and concurrency. Note peak memory during loading and generation if available.
- Change the relevant constraint. If weights dominate, test a supported lower-precision or quantized checkpoint. If usage rises with longer prompts or more active requests, reduce context or concurrency. If temporary allocations are the issue, check attention backend support.
- Test offload or serving-engine controls if needed. Verify support and version-specific settings in the runtime documentation; do not assume a setting from one engine applies to another.
- Re-measure after each change. Check peak VRAM, output quality, and latency. A configuration that barely loads may still fail during generation, so retain headroom for runtime allocations and the intended context and concurrency.
Speed-oriented optimization settings do not necessarily save memory; some can use more. Make one change at a time so you can identify its impact rather than assuming every performance option helps with VRAM.

There is no universal VRAM threshold for a “large AI model”: architecture, precision, context length, GPU, runtime, and concurrency all affect the requirement. Evaluate a proposed configuration against your actual workload rather than treating an example memory figure as a fit guarantee.
