After changing the model behind an AI feature, monitor whether users still complete their tasks—not just whether the new endpoint responds. Establish a baseline, compare the old and new paths on representative work, release the new model gradually where feasible, and keep a tested rollback route. Track quality, workflow behavior, reliability, cost, safety, and the data needed to investigate failures.
Set a baseline before shifting traffic
Use the existing validated model and application behavior as the comparison point. Freeze a representative evaluation set based on real task types, not only easy examples. Include edge cases, high-impact intents, structured outputs, and tool-using workflows if the application has them.
Define acceptance gates before rollout using that baseline and the application’s business and risk requirements. There is no universal quality, latency, or error threshold that fits every application; the appropriate limits depend on expected variation and the impact of failure.

Check that the new model is compatible with the API, request parameters, downstream parsers, and integrations. A model migration can require API or parameter changes; OpenAI’s deployment checklist recommends representative evaluations before prompt or capability changes. Confirm regional and residency requirements with the provider and deployment path you actually use.
Version the model and deployment configuration, preserve the evaluation results, and prepare a tested route back to the previously validated version. Google Cloud’s reliability guidance recommends routing a small subset of production traffic to a new model version as part of a controlled rollout.
What to monitor during a canary rollout
Compare the new and old paths on comparable traffic or matched evaluations. A canary is useful only if you can tell which configuration served a request and evaluate outcomes across both paths.

Quality and user outcomes
- Task success and correctness, with completeness and instruction adherence where relevant.
- Structured-output validity, including schema or parser failures.
- Grounding or factuality for applications that depend on source-supported answers.
- User feedback and production examples that indicate the response was not useful.
Endpoint uptime alone cannot show whether the application still answers well or completes the intended task. Sample outputs for human review and compare them with ground truth when available. Automated judges can help measure behavior, but validate that their judgments reflect what matters in your application.
Agent and workflow behavior
For an agent or a multi-step feature, inspect the sequence as well as the final answer. Check whether it chose the expected tool, supplied valid arguments, acted in the right order, refrained from unnecessary actions, sought confirmation before consequential actions, and reported tool failures appropriately. A response can look plausible while a tool call or downstream action is wrong.
Reliability and performance
- Request success and error rates, including provider or endpoint failures.
- Timeouts and latency distributions; include time to first token when it affects the user experience.
- Traffic, throughput, and resource use where relevant to your architecture.
Use distributions and segment by task type or workflow where possible. An overall average can conceal a slow or unreliable path affecting a smaller but important class of requests.

- Eye comfort: TÜV Rheinland 3‑star* certification reduces harmful blue light while preserving stunning color quality without compromise. *TÜV Rheinland 3-star eye comfort certification.
- Wide viewing angle: Get consistent views across a wide 178° /178° viewing angle.
- In-Plane Switching (IPS): See excellent color accuracy and consistency across wide viewing angles with In-plane Switching (IPS) technology.
- Ultra-thin bezels: Maximize your viewing experience with thin bezels.
Token use and cost
Track input and output tokens and other billable token categories that apply to the provider and configuration. Break consumption down by task type, then compare cost per successful task—not only cost per request. A cheaper request can be a worse result if it increases retries, tool calls, or failed tasks. OpenAI’s checklist also recommends comparing task success, latency, token categories, and cost per successful task when evaluating a model change.

Keep safety and governance checks distinct from ordinary correctness scoring. Monitor harmful, biased, off-topic, malicious, or non-compliant outputs, along with relevant security alerts and privacy or regional-processing constraints. Google Cloud’s AI and ML security guidance treats security as its own area of consideration; passing a task-quality evaluation does not establish that a migration meets these requirements.
Changes in production inputs
Watch whether real prompts, topics, lengths, vocabulary, intents, or outputs have shifted away from the evaluation set. A model may appear stable on yesterday’s test distribution while users begin asking different questions or submitting different inputs. Google Cloud’s generative AI operations guidance recommends end-to-end monitoring, component lineage, alerts for drift or performance decay, and continuous evaluation of production outputs.

Keep enough lineage to diagnose a regression
For each invocation, retain enough context to determine what actually served it and how the result was produced. Subject all logging and sampling to the application’s privacy, security, and retention requirements.
- Model identity and version, plus the deployment configuration and relevant request settings.
- Relevant prompt, input, and output information, where retention is permitted.
- Component execution details, including tool calls and results for multi-step workflows.
- Evaluation context, such as the task category, outcome label, or review result.
Google Cloud advises logging and monitoring the overall input and output and each component end-to-end. Lineage helps distinguish a model behavior change from a prompt, tool, parser, or integration change. Not every platform exposes the same telemetry, so instrument the application path you control and use provider logs where appropriate.

- Start with a small share of traffic. Where the architecture allows, route a limited subset to the new model while preserving the validated path for comparison.
- Check the agreed gates. Review task outcomes, workflow behavior, reliability, cost, and safety against the baseline and risk requirements. Investigate meaningful regressions rather than relying on a single aggregate score.
- Expand in stages only when gates hold. Keep comparing old and new paths as the new model encounters broader traffic and less common cases.
- Reduce traffic or roll back when a gate fails. The trigger, owner, and route back should be defined before rollout; use the prior validated configuration rather than improvising a replacement under incident pressure.
- Turn production failures into regression cases. Add representative examples of newly observed failure patterns to the evaluation set before the next change.
Google Cloud’s reliability guidance supports sending a small subset of production traffic to a new version. Microsoft’s Copilot Studio migration guidance calls for monitoring evaluation results, critical scenario pass rates, production analytics, errors, user feedback, latency, consumption, safety, and compliance after migration. Its platform-specific details will not be available in every stack, but the monitoring categories apply broadly. Microsoft also recommends adding representative cases of new production failure patterns to regression tests.

Keep monitoring after the rollout is complete
Do not stop at the canary. Continue the same quality, workflow, reliability, economic, and safety checks after full rollout: broader traffic can expose uncommon intents and interactions that did not appear during the initial phase. Maintain production sampling or ground-truth comparisons where appropriate, preserve the migration evaluation and decision record, and keep an incident owner and rollback route in place.
Compare models on the same application workload
If the decision is whether to keep the new model, compare both choices against the same representative tasks and application objectives. Treat operating cost and operational fit as part of the decision, not as afterthoughts.
| Comparison area | What to examine |
|---|---|
| Task outcomes | Success, correctness, completeness, instruction-following, formatting, and grounding where relevant. |
| Agent behavior | Tool choice, argument validity, sequencing, restraint, confirmation, and failure handling. |
| Operations | Latency, timeouts, error rates, reliability, and behavior under expected traffic. |
| Economics | Token consumption and cost per successful task. |
| Safety and governance | Safety, compliance, privacy, and regional or data-handling requirements. |
| Operational fit | API compatibility, observability, integration behavior, and a workable rollback path. |
OpenAI’s deployment checklist specifically identifies task success, latency, input, output, reasoning and cache-write tokens, and cost per successful task as comparison considerations. Exact token categories and API behavior depend on the provider and model version, so verify them against the current documentation for the configuration you deploy.
