AI can fail because the data behind it is inappropriate, unrepresentative, exposed, or vulnerable to tampering—not just because of a flawed model. Data is a major part of AI reliability and safety, but it is not the whole story: no single data-quality fix can make a system trustworthy.
NIST’s voluntary AI Risk Management Framework (AI RMF) and its Generative AI Profile offer a practical way to examine data risks across an AI system’s life cycle. They treat data as one important part of broader risk management, not as a universal explanation for every failure.
Why data belongs in the AI safety conversation
An AI system’s behavior depends partly on what data it was trained or adapted on, what data is used to evaluate it, and what information it encounters in operation. Those data sources can affect whether a system works reliably in its intended context, treats groups unevenly, exposes sensitive information, or can be manipulated.
But data is not the only source of risk. NIST describes trustworthiness in terms that include reliability, safety, security and resilience, accountability and transparency, explainability, privacy, and fairness. These concerns require attention across design, development, deployment, use, and evaluation—not just during dataset preparation. NIST’s AI RMF overview says the framework is intended for voluntary use to help incorporate trustworthiness considerations throughout those activities.

What can go wrong with AI data?
Data may not fit the intended context
A dataset can be large and orderly yet still be a poor match for how a system will be used. If the data does not reflect the relevant context, a system may perform unreliably when it encounters different users, conditions, or tasks. NIST warns that inaccurate, unreliable, or poorly generalized systems increase negative risks and reduce trustworthiness. That makes context and generalization important questions alongside basic data cleanliness or volume. NIST’s AI risk material discusses these concerns.
Imbalances can contribute to harmful bias
Representation matters because uneven data can contribute to harmful bias. NIST’s Generative AI Profile specifically identifies data imbalance as a concern and recommends policies that address data collection, retention, and minimum quality. The profile does not provide one universal formula for scoring data quality; what counts as adequate depends on the system and context. NIST AI 600-1 sets out this guidance.

Sources and uses can be unclear
Organizations need to know where data came from, how it was curated, and what uses are allowed. NIST recommends documenting curation policies and defining how third-party data and intellectual property will be used, stored, and protected. Without those controls, teams may struggle to assess suitability, privacy exposure, or intellectual-property risks.
Privacy and security are data risks, too
Data stewardship includes protecting confidentiality, integrity, and availability. NIST’s risk material names data poisoning—maliciously altering data to affect a system—as well as potential exfiltration of training data or intellectual property. The Generative AI Profile also calls out leakage of personally identifiable information as a risk to consider. Collection and retention policies therefore need to account for both what a system needs and what harm could follow from keeping or exposing information. Questions to ask about an AI system’s data
These questions turn the broad concern into reviewable decisions. They are grounded in NIST guidance, not a single prescribed test or universal quality score.
- Fit: Is the data appropriate for the system’s intended context and users?
- Coverage: Could imbalance or gaps contribute to unreliable results or harmful bias?
- Provenance and permissions: Are curation policies documented, and are the intended use, storage, and protection of third-party data and intellectual property defined?
- Privacy: Do collection and retention policies address the risk of exposing personally identifiable information?
- Security: Are there controls to protect data from tampering, loss, and unauthorized disclosure?
- Change over time: Is the system evaluated again when its use, context, or conditions change?
How NIST’s framework can organize the work
NIST AI RMF 1.0 was released on January 26, 2023. It is a voluntary framework organized around four functions: Govern, Map, Measure, and Manage. These are organizing functions, not a mandatory sequence.

NIST’s AI RMF Playbook offers suggested actions to support the framework; it explicitly says it is not a checklist or a set of steps that must all be followed. The Playbook is meant to help organizations apply the framework in ways suited to their circumstances.

It also identifies data imbalance, personally identifiable information leakage, poisoning, and exfiltration among risks to consider. These recommendations make data governance a concrete part of managing AI risk.

They do not establish that every AI failure is caused by data, quantify what share of failures is data-driven, or promise that a dataset meeting one threshold makes a system safe. The AI RMF is voluntary guidance, not a universal legal mandate. NIST says the framework is being revised, and its AI Resource Center says the Playbook will be updated after that revision. Because that status can change, check NIST’s current AI RMF page for the latest information.
