Realistic test data is not data that merely looks like it belongs to a real person. It is data that exercises your application’s schema, business rules, relationships, and important scenarios—while remaining reproducible and appropriate for the environment. For a focused unit test, write a small explicit fixture. For repeatable plausible values, use a seeded Faker library. For larger or statistically representative datasets, use a schema-aware generator or a source-derived synthesis tool, and evaluate its privacy controls separately.

What makes test data useful?

A name, email address, and street address can look convincing while still being useless to a test. A useful record conforms to the application’s schema, satisfies the domain rules relevant to the test, and has the relationships that the behavior under test relies on. It should also be reproducible when a failure needs to be diagnosed.

For example, if an order test checks authorization and totals, the data may need a customer, an order linked to that customer, line items linked to the order, and prices that satisfy the application’s rules. Randomly generating each field independently can produce records that look plausible but do not form a valid order.

Start with the test’s purpose, then choose the smallest data-generation approach that serves it. More volume or realism is not automatically better: a broad dataset cannot replace a carefully specified boundary case, and a plausible field value cannot substitute for valid application relationships.

Choose the approach that fits the test

Use explicit fixtures for tests that need exact cases

When a test targets one behavior, hand-authored data makes the important condition visible. Use explicit fixtures for empty fields, boundary values, invalid combinations, permission states, unusual dates, or a particular failure path. If many tests need similar objects, a factory can centralize defaults and related-object construction without hiding the values that matter to an individual test.

Keep the unusual condition explicit. If the behavior depends on a customer with no orders, do not rely on a random generator to happen to produce one. If it depends on a rejected payment state, encode that state directly. This reduces dependence on incidental random output and makes failures easier to interpret.

Use Faker for plausible, repeatable field values

Faker is a Python package with providers for values such as names, addresses, and text. It supports locale selection and can be installed with pip install Faker. Its documentation also demonstrates using Faker through a pytest fixture: Faker documentation.

Faker supplies field values; your application’s factories or test setup still need to enforce required fields, domain constraints, relationships, and uniqueness. Set the locale explicitly when tests depend on localized names, addresses, dates, or formats rather than accepting whichever default happens to be configured.

Seed deliberately

Faker’s seed() seeds the shared random number generator; seed_instance() seeds an individual generator. The documentation states that a seed reproduces results when the same methods are called with the same Faker version. Because provider datasets can change, outputs are not guaranteed to stay consistent across patch versions. If tests hard-code expected generated values, pin the patch version: Faker seeding guidance.

Prefer assertions about behavior and invariants over assertions that depend on a generated name or address being a particular string. Pin versions where exact generated output is part of the test contract, and keep critical edge cases as explicit fixtures.

Use schema-aware generation when data size or relationships matter

For development environments, end-to-end suites, demos, or other workflows that need more than a handful of records, schema-aware generation can help produce records that fit a data model. It still needs to account for application constraints and relationships: having the right column types does not by itself guarantee a valid business scenario.

Generate synthetic records from rules and schema

MongoDB’s Atlas tutorial describes synthetic data aligned to a real dataset’s schema for testing and development. Its Node.js example uses faker.js to create nested owner and event data and inserts 5,000 documents. This kind of generation can build a larger dataset from schema and generator rules rather than deriving every record from production rows. Check whether the generator also models the constraints and references your tests depend on.

Derive a statistical proxy from source tables

Snowflake documents a different option: synthetic data generated from source tables. Its procedure retains column names and types, generally produces the same number of rows, and aims to preserve approximate distributions and correlations. An optional similarity filter can remove rows deemed too similar to the input using nearest-neighbor distance measures. These are documented platform behaviors, not a guarantee that the output is safe for every use: Snowflake synthetic data documentation.

For joins across synthetic tables, Snowflake instructs users to designate join-key columns so corresponding source values receive consistent but artificial values. A consistency secret can preserve join-key consistency across runs. The documented feature requires Enterprise Edition or higher. Snowflake describes a synthetic dataset similar to a production dataset as useful for testing and validating a production environment; that purpose does not remove the need to assess the privacy controls and data handling for your own use case.

Distinguish privacy-preserving synthesis from ordinary fake values

Generating invented values does not, by itself, establish that a dataset is anonymous, compliant, or safe to share without restrictions. A faker library that creates names and addresses independently is a different method from a system that derives a statistical proxy from sensitive source tables, and neither description alone settles the privacy question.

Dataiku DSS 14 documents a Universal Data Generator for datasets created from scratch using distributions, categorical sampling, Faker providers, and correlation modeling. It separately documents privacy-preserving synthesis approaches including DP-CTGAN, PATE-CTGAN, and MWEM, as well as methods for oversampling classification targets. The synthetic-data generation plugin must be installed for this workflow. These tools are more relevant to analytics, sandboxes, and model validation than to ordinary unit-test fixtures: Dataiku DSS synthetic data documentation.

When a workflow starts from sensitive data, evaluate the method and controls in context, including what source information is used and what risks remain. Snowflake’s similarity filter and Dataiku’s documented differential-privacy-based approaches are specific features; they should not be treated as blanket guarantees for other generators or deployments.

Use generative AI as an authoring aid, not a correctness guarantee

A 2024 preprint by Baudry and coauthors evaluated prompting language models for test-data tasks across 11 domains. The authors examined prompts that request raw test data, a program that generates test data, or a program that uses an existing Faker library. The abstract reports that models could successfully create realistic data generators in the evaluated domains, but it does not establish production readiness, privacy protection, reproducibility, or correctness for a particular application: Baudry et al., 2024 preprint.

Use an AI-generated fixture or generator as a draft. Review its output against your schema, constraints, relationships, deterministic requirements, licensing needs, and privacy requirements. Keep critical scenarios explicit and tested rather than trusting generated code to cover them.

A practical workflow for building test data

  1. Define the behavior under test. Identify the specific rule, boundary, permission, or failure condition the test must exercise.
  2. Write the smallest explicit fixture that proves it. Include required related objects and encode the important condition directly.
  3. Extract repeated setup into factories. Centralize ordinary defaults and relationship construction while leaving scenario-specific values visible in the test.
  4. Add Faker only where plausible variation helps. Choose an explicit locale, seed the generator when repeatability matters, and avoid assertions tied to incidental output.
  5. Scale up only for workflows that need it. Use schema-aware generation for broader datasets, and verify that generated constraints and references fit the application.
  6. Assess privacy separately when using sensitive source data. Determine what the method uses, what controls it applies, and whether those controls fit the intended environment and sharing model.
  7. Make failures reproducible. Record or control the seed, generator version, configuration, and scenario so a failing case can be rerun and diagnosed.

Questions to settle before adopting a generator

  • Schema and relationships: Does it produce valid types, required fields, foreign keys, and domain relationships?
  • Distribution fidelity: Does the test need plausible independent values, realistic correlations, or a source-derived approximation?
  • Determinism: Can the same scenario be recreated across runs, and what happens when generator versions change?
  • Privacy controls: Is the method creating records from scratch or learning from source data, and what specific safeguards are documented?
  • Scale and integration: Can it populate the required environment and stores without adding unnecessary operational complexity?
  • Dependencies and cost: Does the workflow require a platform edition, plugin, or other dependency that changes where it can run?

No single approach is established as universally faster or more effective. Choose according to the test’s purpose and verify the behaviors that matter in your own application.
