To stream data into a machine-learning workflow, send events to a durable topic, then have a consumer read them, validate each record, call a model, and write predictions to an output topic or other sink. Add a stream processor only when you need tasks such as joins, windows, event-time handling, or persistent state. Live input does not, by itself, update a model’s weights.

What data streaming means for an ML project

A batch is a bounded collection of records that can be processed after it is assembled. A stream is an unbounded sequence: the system processes records as they arrive, without waiting for the input to end. Apache Flink describes a streaming pipeline as data moving from sources through operators to sinks, with processing continuing as new input arrives (Flink hands-on training overview).

For machine learning, separate three workflows that are often loosely called “real-time ML”:

  • Streaming inference: receive a live event, run a model with its current parameters, and publish a prediction. The model can remain unchanged.
  • Streaming training or evaluation: route examples, labels, or outcomes into a training or evaluation process. These are distinct data paths and should have explicit destinations and monitoring.
  • Online learning: update model parameters incrementally as new examples arrive. This requires an algorithm and serving/training design that support safe updates; it does not follow automatically from connecting a stream to a model.

The 2020 Kafka-ML paper describes stream-fed training, evaluation, and inference as separate pipeline stages. It also notes limitations in online-learning support for the framework it discusses, so treat it as an architectural example rather than current compatibility guidance (Kafka-ML paper).

The simplest useful architecture

Begin with this flow: producer → durable topic/log → model consumer → prediction sink. A topic is a named stream of records; the durable log separates the application producing events from the application consuming them. Redpanda’s documentation describes topics as replayable logs, and explains that multiple consumers can use the stored events (Redpanda introduction to events).

  1. Producer: publish one well-defined event type, such as a click, sensor reading, or transaction.
  2. Topic or log: retain records long enough for consumers to process or replay them, subject to your operational and data-retention needs.
  3. Consumer: deserialize and validate each event, invoke the model, and attach useful metadata to the result.
  4. Output sink: write predictions to a separate topic, database, or application endpoint so downstream users can consume them independently.

Keep the first version small: one event schema, one measurable prediction task, and one consumer. A separate stream-processing layer is optional, not a prerequisite for every streaming model.

Design the event before wiring up the model

Include only fields needed for prediction and downstream interpretation. Give each event a stable entity key where relevant, an event timestamp, and a schema or version strategy that lets producers and consumers evolve without silently disagreeing about field meaning.

  • Entity key: identifies what records relate to, such as a device or account. It can also help preserve per-entity ordering where the broker and partitioning design support it.
  • Event timestamp: records when the underlying action occurred, rather than only when the system received it.
  • Validation: reject, quarantine, or otherwise handle malformed and unexpected records explicitly instead of allowing bad input to fail unpredictably inside model code.
  • Prediction metadata: consider recording the model version, event identifier, prediction time, and relevant confidence or score fields when downstream audit or evaluation needs them.

If training is part of the project, define separately how labels become available and how predictions are later matched with outcomes. Inference traffic alone is not a labeled training set.

Get a first event flowing locally

A local broker is useful for learning the producer-to-consumer path before choosing a production deployment. Redpanda’s self-managed quickstart is one vendor-specific example; it calls for Docker Compose and at least 4 GB of free memory before starting its containers. That is a requirement for the documented quickstart, not a general minimum for other brokers or production systems. The current example includes a v26.2.3 container image, so check the live instructions for version changes before following it (Redpanda self-managed quickstart).

The quickstart demonstrates creating a topic, producing a message, and consuming it with rpk. Verify that a plain test event can travel end to end before adding model serialization, inference, and output handling. The setup uses a bootstrapped superuser for exploration; do not carry development credentials or broad administrative permissions into a deployed application. Use restricted permissions for production tasks as the quickstart recommends.

Connect the consumer to the model

The consumer’s core loop is straightforward: read a record, validate and decode it, construct the model input, run inference, then publish or persist the result. Make failures visible and intentional: malformed data, unavailable models, and sink errors need defined handling rather than silent loss.

Scale consumers only when the input rate and model-serving capacity call for it. A consumer group or equivalent parallelism can distribute work, but the number of workers, topic partitioning, and ordering assumptions must fit together. Kafka-ML’s 2020 paper illustrates inference replicas using Kafka consumer groups for load balancing and fault tolerance; because it is a research implementation, use it as an example of the pattern, not as current deployment guidance (Kafka-ML paper).

When to add a stream processor

Add Flink or another stream processor when the workflow needs capabilities that are awkward to implement safely in a basic consumer. Flink’s stable training documentation covers continuous processing, event time, stateful computation, and snapshots (Flink hands-on training overview).

  • Windows: aggregate events over a time or count range, for example to calculate a recent activity feature.
  • Joins: combine related event streams or enrich events with other changing data.
  • Persistent state: maintain per-entity information across records without building recovery logic from scratch.
  • Event-time logic: compute results according to when events happened, including a policy for late or out-of-order arrivals.
  • Managed recovery: checkpoint pipeline state and input positions so processing can resume after failure.

Flink documents recovery through snapshots that record input offsets alongside pipeline state; following a failure, sources rewind and the saved state is restored before processing resumes. End-to-end exactly-once behavior still depends on the source and sink guarantees as well as the processor, so do not infer it from a processor setting alone (Flink hands-on training overview).

Make time, retries, and duplicates explicit

Streaming correctness is not only a question of speed. Decide which timestamp controls a computation: event time is when the event occurred; processing time is when the system handled it. Late arrivals can change a time-based result, so choose whether to wait, revise prior output, or drop events after a defined lateness threshold.

Also determine what happens when a consumer fails after reading an event but before its output is safely written. Retrying may produce duplicate work or duplicate predictions unless the operation is idempotent or the pipeline coordinates offsets and output transactions. Define how records are acknowledged, how offsets advance, what can be replayed, and how duplicates are recognized. Test these behaviors with failure scenarios instead of relying on an “exactly once” label in isolation.

Choose a stack by workload, not a universal ranking

There is no established, independently comparable benchmark here that ranks Kafka, Redpanda, managed brokers, and ML processors for every project. Vendor performance claims and one applied study are not substitutes for testing the reader’s own event shape, model latency, retention, and operational constraints.

Decision What to compare
Time to first event Local setup effort, managed-service availability, and client-library fit.
Operational burden Who patches, monitors, secures, and scales the broker and any processor.
ML integration Supported programming languages, framework interfaces, serialization formats, and model-serving pattern.
Processing needs Simple consume-and-predict versus windows, joins, event-time logic, or state.
Correctness and recovery Replay, ordering, duplicate handling, checkpointing, and source-to-sink delivery guarantees.
Measured workload fit Representative throughput, end-to-end latency, retention requirements, and cost.

A 2024 Kafka/Flink paper on a particular short-video recommendation workload reports an 85% reduction in event throughput using Avro schema and compression, and a 40% decrease in costs. These are results reported by Saket, Chandela, and Kalim for that case—not expected savings or throughput changes for other systems (Real-time Event Joining in Practice With Kafka and Flink).

A practical build sequence

  1. Define the event and task. Choose a single event type, its key and timestamp, and a first prediction target. If training or evaluation is also in scope, specify where examples, labels, and results flow separately.
  2. Prove the broker path. Use a local or managed broker, create a topic, send a sample, and confirm a consumer can read it.
  3. Add validation and inference. Deserialize records, validate the schema, call the model, and produce a prediction with enough metadata to interpret it.
  4. Set delivery and time behavior. Specify retries, offset handling, duplicate strategy, late-event policy, and required delivery guarantees.
  5. Measure with representative traffic. Track input and output rates, end-to-end latency, backlog, failures, and resource use; test recovery and replay.
  6. Add processing only for a demonstrated need. Introduce a stateful processor for joins, windows, persistent state, event-time semantics, or checkpointed recovery when those needs justify its additional deployment and maintenance.
