This can help with arithmetic, symbolic, and procedural tasks, but it does not remove the need for the model to understand the question or generate the right program.
What is a Program-Aided Language Model?
PAL is a method introduced in the 2023 paper “PAL: Program-aided Language Models”. Rather than asking an LLM to solve every step by producing natural-language reasoning, PAL asks it to express intermediate reasoning as a program. A runtime, such as a Python interpreter, executes that program to produce a result.
The authors describe the division this way: “With PAL, decomposing the natural language problem into runnable steps remains the only learning task for the LLM, while solving is delegated to the interpreter.” In practical terms, the model decides what the problem means and how to represent the needed operations; the interpreter performs those encoded operations.
How PAL uses a Python interpreter
- Read the problem: The prompt gives the model a natural-language question, often alongside examples showing the desired approach.
- Generate a program: The model interprets the question and writes code that represents intermediate reasoning steps.
- Execute the code: A programmatic runtime runs the generated code and computes its result.
- Return the requested answer: The implementation extracts the relevant result from the execution.
The interpreter does not independently establish that the model understood the question correctly. If the generated program encodes the wrong quantities, assumptions, or operations, execution can return a neatly computed but irrelevant answer. Code generation and the availability of a suitable runtime are therefore part of the method, not optional extras.

What PAL can improve—and what it cannot
PAL is most naturally suited to questions whose solution can be represented as explicit calculations, symbolic operations, or procedures. Delegating those operations to a runtime can reduce dependence on the LLM’s ability to maintain exact arithmetic or symbolic steps in generated text. It does not make the LLM’s interpretation infallible, and running code does not by itself verify that the answer is correct or safe.
For a task without a clear executable formulation, writing code may not provide the same benefit. PAL should therefore be understood as a way to divide computation for particular kinds of reasoning problems, rather than a general guarantee that an LLM will reason better on every task.

PAL compared with chain-of-thought prompting

These are differences in how computation is divided, not proof that one prompting approach always wins. Any comparison depends on the model, prompt, decoding method, benchmark, and execution setup.
What the PAL paper found
The ICML 2023 paper evaluated PAL on 13 mathematical, symbolic, and algorithmic reasoning tasks drawn from BIG-Bench Hard and other benchmarks. In one reported comparison on GSM8K, the authors found that PAL using Codex exceeded PaLM-540B with chain-of-thought prompting by 15 absolute percentage points in top-1 accuracy. That is a result from the paper’s particular models and evaluation setting—not a claim about all current models, all tasks, or a guaranteed improvement from adding code execution.

The paper’s abstract characterizes PAL as outperforming much larger models across the natural-language reasoning tasks it evaluated. That conclusion should be read within the scope of those experiments, rather than generalized to uses of generative AI that the evaluation did not cover.

The PAL project page links to the paper, code, and data. The project repository describes an implementation in which an LLM generates reasoning code and a Python interpreter executes it, including an interactive example. Its API and dependency instructions document the project as it was published; they should not be assumed to be current setup guidance without checking the repository’s present state.
