You can lower recurring AI workflow costs without sacrificing answer quality by first measuring each workflow, then cutting waste, reusing stable context, and routing suitable work to lower-cost or asynchronous options. Treat every change as a test: compare quality and total cost per completed task—including retries, tools, retrieval, and infrastructure—before rolling it out.

Measure cost and quality before changing the workflow

Start with a baseline for each workflow, not just your organization’s combined API bill. A cheaper token price does not necessarily mean a cheaper completed task if it causes more retries, extra verification, or failed outcomes.

  • Cost: Record model and service, request volume, input and output tokens, tool calls, retrieval, orchestration, and infrastructure.
  • Quality: Choose a task-specific measure, such as correctness, task completion, or adherence to required instructions. Preserve representative examples and important edge cases.
  • Operations: Track latency, failures, retries, and escalation rates alongside cost.
  • Attribution: Where possible, calculate spend per task or completed outcome and set budgets or alerts. AWS recommends a living cost model that includes inference as well as invocation, retrieval, event, and orchestration costs (AWS production architecture guidance; AWS serverless AI cost guidance).

Keep this baseline as the comparison point for changes. If a change lowers the bill but pushes quality below your acceptable threshold, it is not a successful optimization.

Reuse stable context with prompt caching

When requests repeat the same large prompt prefix, prompt caching may reduce the cost of processing that repeated context. Put reusable system instructions, tool definitions, and other stable material together in a consistent prefix when the provider’s cache design supports it. Track cache hits, reads, and misses to see whether the workflow actually reuses the prefix.

Check the current provider documentation for eligibility, minimum prefix size, cache write and read prices, retention, routing behavior, and data handling. These details vary by model and service. For example, OpenAI documents a 1,024-token minimum cacheable prompt length for GPT-5.6 and later, along with model-specific cache rates; that threshold should not be assumed for other models (OpenAI prompt caching documentation). A cache write can cost more than an uncached input, so the benefit depends on how often the prefix is reused.

Provider benchmarks are not a forecast for your traffic. Anthropic reports 2.7 to 5.3 times lower agent-loop cost across benchmarks in its guide and an 83% lower bill—or 88% with input trimming—for one measured small triage-agent workload. Those are workload-specific measurements, not general savings guarantees (Anthropic cost and intelligence guidance).

Remove low-value tokens and redundant calls

Look for context and work that consume resources without improving the answer. Common candidates include repeated conversation history, irrelevant retrieved passages, fetched-page boilerplate, oversized images, unused tool definitions, verbose outputs, duplicate requests, and redundant agent steps.

  • Trim or summarize old history only when the resulting prompt still contains the information needed for the current task.
  • Load only relevant tool definitions and retrieved passages rather than sending every available option or document.
  • Set an appropriate output length for the task; avoid asking for lengthy explanations when a concise result will do.
  • Remove duplicate requests and unnecessary agent handoffs, but retain tool calls that materially improve correctness.

Measure the net effect rather than counting tokens alone. Prompt and retrieval changes can affect answer quality, caching, and total infrastructure costs. Retrieval, for example, can reduce the context sent to a model while adding retrieval costs; compare quality and total cost for your workload (EMNLP Industry paper on RAG versus long context). Anthropic reports 24% fewer input tokens with a higher score for its programmatic tool-calling result on agentic search benchmarks, but that result is specific to the reported evaluation (Anthropic cost and intelligence guidance).

Batch work that does not need an immediate answer

Evaluations, backfills, scheduled jobs, and other unattended work may fit asynchronous processing. Use it only when the job can tolerate slower completion and the service’s availability conditions.

Do not move a user-facing workflow to a batch or flex path unless its latency and availability requirements allow it.

Use cheaper models selectively, with escalation

Not every task needs the same model capability. Group work by difficulty and risk, then test a less expensive model on representative requests. Route routine cases to it only if it meets your quality threshold; send uncertain, failed, or higher-risk cases to a stronger model or a human review path.

  1. Choose representative cases for each task type, including difficult and borderline examples.
  2. Compare candidate models on task success and answer quality, not just token price.
  3. Include the costs of routing, verification, retries, and escalation in the per-outcome calculation.
  4. Set an explicit escalation condition, such as a failed validation or a confidence signal your system has tested.
  5. Monitor results after rollout and adjust the routing rules if quality or total cost shifts.

AWS recommends tiered model use, with escalation when a simpler model fails or lacks confidence (AWS production architecture guidance). FrugalGPT’s 2023 paper reported up to 98% cost reduction for experimental cascades that matched the best individual model’s performance in its study; that finding is experimental and does not establish the savings a production workflow will achieve (FrugalGPT paper).

Similarly, AWS advertises up to 30% cost reduction without compromising accuracy for Bedrock Intelligent Prompt Routing. Treat that as an AWS claim for that service, not an independent result or guarantee for another workload (Amazon Bedrock Cost Optimization). Fine-tuning should not be the default cost fix: access and economics need checking, and OpenAI’s model optimization guidance notes that fine-tuning is winding down for new users (OpenAI model optimization).

Re-evaluate after every meaningful change

Run the same stable evaluation set before and after changing prompts, models, retrieval, tools, or routing. Compare outcomes, quality, total cost per completed task, and latency. For agent workflows, inspect traces and grade tool selection, handoffs, instruction adherence, guardrail behavior, and final outcomes—not only the final text (OpenAI model optimization and evaluations; OpenAI agent workflow evaluation).

Repeat evaluations as model snapshots and behavior change. OpenAI notes that model behavior can vary across snapshots and model families, so a previously successful configuration may need to be checked again (OpenAI model optimization).

Choose optimizations by total outcome, not headline price

For each candidate change, compare the factors that determine whether it suits your workflow:

  • Quality and task success: Does it meet the threshold on representative cases?
  • Total cost: What does a completed outcome cost after retries, tools, retrieval, and infrastructure?
  • Latency and availability: Can the workflow tolerate slower completion or occasional unavailability?
  • Workload fit: Does it have enough repeated context for caching, or enough delay tolerance for batching?
  • Implementation and upkeep: Will routing, monitoring, or prompt changes add operational overhead?
  • Data constraints: Do retention settings, routing, or regional requirements fit your organization’s needs?

AWS product materials advertise up to 90% lower costs and up to 85% lower latency for prompt caching on supported Bedrock models. These are provider-specific maximum claims, not expected results for all models or traffic patterns (Amazon Bedrock Cost Optimization).
