Define what counts as success, test varied held-out examples under recorded conditions, score observable results, and report uncertainty and limits. The result is evidence about performance on those tasks, not proof of general intelligence.
What does it mean for an LLM to “reason”?
For an evaluation, define reasoning operationally: successful performance on specified tasks under specified conditions. “Can reason” is too broad to measure. A testable claim might be that a model can solve multi-step arithmetic word problems, apply a stated rule to unfamiliar inputs, or choose a valid next action while respecting explicit constraints.
Decide in advance what counts as success for each task. Depending on the problem, that could mean an exact answer, passing executable tests, satisfying formal constraints, or meeting a rubric reviewed by qualified people. This keeps the evaluation focused on what the model did rather than how persuasive its response sounds.
How should you choose tasks and benchmarks?
Build a test set around the intended use. Include representative problems and, if your claim spans different kinds of reasoning, more than one task shape. Chain-of-thought research has studied arithmetic, commonsense, and symbolic tasks; that variety is a useful prompt to match task selection to your use case, not a ready-made universal test (Wei et al., 2022).

Existing benchmarks can supply evidence about particular task families or illustrate how to organize an evaluation. They do not establish broad reasoning ability by themselves.

For domain-specific use, add realistic domain tasks and ask qualified reviewers to check the expected answers and scoring rules. Choose metrics that matter to the use case; do not assume every available metric deserves equal weight.

How do you make the test meaningful and reproducible?

Hold out examples and vary them
Keep a private test split or write fresh items after selecting the model where feasible. Add controlled paraphrases and change irrelevant details, quantities, ordering, or constraints. Check whether performance survives those changes instead of depending on familiar wording. Static public benchmark items may have appeared in training data, while exact training data can be difficult to trace; a 2025 survey reviews this contamination risk (EMNLP 2025 survey). Fresh items reduce one risk but do not prove the model has never encountered related material.

Fix and record the conditions
For every run, record the exact model identifier and date, prompt, system instructions, few-shot examples, decoding settings, reasoning mode, token limit, available tools, retries, and score-extraction procedure. Keep these conditions the same when comparing models, or clearly disclose differences. The ARC Prize Foundation’s testing policy says its scoring methodology aims to reproduce the same procedure for AI and human test-takers, and describes model configurations with reasoning levels and token limits (ARC Prize Verified Testing Policy).

Use scoring that can be checked
Prefer exact answers, executable tests, formal constraints, or independently reviewed rubrics when they fit the task. Define rubrics before examining outputs. For open-ended answers, specify how human raters or validated judges will score them, how agreement will be measured, and how disagreements will be resolved. Track partial credit and error types as well as pass rate.

Repeat runs and preserve the record
Use enough items to make the estimate useful and, for stochastic systems, enough repetitions to understand run-to-run variation. Preserve prompts, raw outputs, scoring artifacts, environment and tool versions, and dates. Rerun after meaningful model or prompt changes, while keeping a separate fresh set to check for overfitting to the evaluation.

How should you compare two models?
Run both systems on the same items with the same prompts, tools, inference budget, scoring rules, and repetition policy. If an identical setup is impossible, document the differences so readers can tell what the comparison measures. Report the components separately rather than letting a single aggregate score hide useful trade-offs.

If you combine results into one score, explain the weights and why they fit the intended use. HELM’s multi-scenario, multi-metric approach illustrates why it can be more informative to expose trade-offs than to report only one number (HELM paper).

How much confidence should you place in a score?
A score estimates performance on a particular sample of tasks; it is not a timeless property of a model. Report the number of items, an appropriate uncertainty interval or other uncertainty summary, and how results were aggregated. Small test sets can produce unstable estimates, so avoid false precision.
NIST’s 2026 AI 800-3 report argues for an explicit statistical model and disclosed assumptions when analyzing evaluation results. It discusses generalized linear mixed models as one method for estimating capabilities while accounting for variation. The report describes analysis involving 22 frontier LLMs on GPQA-Diamond, BIG-Bench Hard, and Global-MMLU Lite (NIST report announcement). The appropriate model depends on the evaluation design; the key is to make assumptions visible rather than imply more certainty than the data supports.
Does a correct answer or a reasoning trace prove the model reasoned?
A correct answer is evidence that the model solved that item under those conditions. It does not, by itself, show that the model will solve unfamiliar problems or reveal how it arrived at the answer. Likewise, a fluent explanation or chain of thought is not conclusive proof that every stated step is correct or a faithful record of internal computation.
Chain-of-thought prompting improved performance on some arithmetic, commonsense, and symbolic reasoning benchmarks in a 2022 study (Wei et al., 2022). Treat that as evidence that prompting can affect measured performance, not as a current model ranking or proof that displayed explanations reveal internal processes. Check intermediate steps against the task when they matter.

It also notes limits: controlled benchmark realism and evaluation awareness can weaken transfer to real-world behavior (OpenAI, “Evaluating chain-of-thought monitorability”). A benchmark result should therefore be interpreted within its test conditions, not as a guarantee about deployed behavior.
