Evaluate a retrieval-augmented generation (RAG) app at three connected levels: retrieval, answer generation, and the complete user-facing workflow. Measure the components separately to locate problems, then test them together on questions that resemble real use. A single benchmark score cannot show whether your app retrieved the right evidence, used it faithfully, answered the question, and continued to do so after a change.

What should a RAG evaluation measure?

A RAG system first retrieves documents or passages, then uses them as context to generate an answer. Errors can arise at either stage or in how the stages interact. A retrieval problem may leave out key evidence or return irrelevant passages. A generation problem may ignore useful context, make unsupported claims, or fail to synthesize the evidence fully.

Keep the stages’ results visible rather than hiding them in one blended score. Retrieval measurements help explain whether the system found useful evidence; generation checks show whether the answer used that evidence well; end-to-end tests show whether the application succeeds on realistic tasks. This division reflects the distinct evaluation dimensions described in the 2023 RAGAS paper.

Choose metrics that match the evidence you have

The right metric depends on whether you have relevance labels, reference answers, or a human-review rubric. Metrics are measurements, not universal pass marks: define success in terms of your users and the cost of failure.

Whole-system quality Does the complete app answer representative questions acceptably? Task-specific end-to-end rubric alongside component metrics A composite score can conceal a critical weakness in one stage.

When you have relevance labels

Use query-document or query-chunk labels to compute retrieval coverage and noise at a chosen cutoff. Recall@k measures how much of the relevant evidence appears among the top k results; precision@k measures how much of that returned set is relevant. MRR and NDCG add information about ranking, so a useful result near the top counts differently from one buried lower down.

When you do not have labels

A judge-based relevance score can help triage results, but it is not equivalent to deterministic scoring against reviewed labels. Document the judge and rubric, manually validate a sample, and treat the score as uncertain until you know how well it agrees with human review.

Keep answer dimensions separate

Faithfulness or groundedness asks whether claims are supported by retrieved context. Relevance asks whether the response addresses the user’s request. Correctness against a reference and completeness are different checks: an answer can be relevant but wrong, or grounded yet incomplete. Ragas lists context precision, context recall, context entities recall, noise sensitivity, response relevancy, faithfulness, multimodal faithfulness, and multimodal relevance among its metrics; it also notes that LLM-based metrics may require one or more model calls and that users can modify or create metrics. Arize Phoenix documents evaluators for faithfulness, hallucination, correctness, retrieval relevance, and other qualities. Phoenix says its LLM evaluation templates are tested against golden datasets and achieve an F1 score of 85% or higher on benchmarks. That is a Phoenix vendor statement; the documentation page does not state a year, and the figure is not an independent cross-platform comparison. Its evaluation documentation defines faithfulness as whether a response is grounded in the provided context.

NVIDIA’s RAG Blueprint documentation describes answer accuracy against reference ground truth, context relevancy, response groundedness, and context recall at top-k cutoffs including 1, 3, 5, and 10. Those are documented measures, not universal targets.

Build a repeatable evaluation loop

Treat the evaluation set as a maintained regression suite, not a one-time demo. The same questions should help you compare versions, while a separate development set gives you room to tune without repeatedly optimizing against the held-out evaluation questions.

  1. Define success in application terms. Identify user tasks and costly failures, such as missing facts, wrong citations, unsupported answers, unnecessary refusal, excessive latency, or expense. Set thresholds with product and domain owners; there is no universal RAG pass mark established by the cited documentation.
  2. Build a representative dataset. Use realistic questions from intended users or production logs, subject to privacy and access controls. Add relevant difficult cases: ambiguous requests, questions with no answer in the corpus, conflicting or stale documents, multi-hop questions, and requests that should be refused or qualified. Attach reference answers, relevant-document or chunk labels, or a review rubric where practical. Synthetic questions can bootstrap the set, but check that they represent actual use.
  3. Run retrieval-only checks. Inspect retrieved chunks and calculate label-based recall, precision, or ranking measures when labels exist. Without labels, use judge-based relevance for triage and manually validate a sample.
  4. Run generation checks with controlled context. Provide known context and assess grounding, relevance, correctness, and completeness. This helps isolate whether the generator uses evidence appropriately.
  5. Test the full production path. Exercise query processing, retrieval, context assembly, the model call, citations, and abstention behavior together. Save traces and representative failures so results point to changes you can investigate.
  6. Compare versions consistently. Reuse the held-out set after changes to documents, chunking, retrieval, prompts, or models. Record configuration and evaluator versions, and add reviewed production failures to the suite.
  7. Calibrate the judge. Ask domain reviewers to score a sample, compare their ratings with the judge, and clarify ambiguous rubrics. Repeat the check when the judge model or prompt changes. Report disagreements and examples rather than relying on an average alone.
  8. Monitor after release. Offline tests cannot fully reproduce live query mix or user behavior. Track the same failure categories in production, review feedback, and refresh the evaluation set periodically.

LangChain’s evaluation guidance recommends matching the test dataset to the production distribution and checking the retriever and generator separately as well as together. It also warns that benchmark performance may not carry over under distribution shift. Its tutorial is historical, so its examples and integrations are conceptual guidance rather than current setup instructions. LangChain also identifies LLM-judge risks: self-preference, sensitivity to comparison order, inconsistent use of score scales, and a preference for longer answers.

Use score patterns to find the next fault

Read scores together with retrieved passages, final answers, and traces. A low retrieval score points to a different investigation than a grounded answer that fails to address the question.

  • Low recall or missing evidence: Confirm that the reference evidence exists in the indexed corpus. Then inspect ingestion, metadata filters, query formulation, chunk boundaries, embeddings or lexical retrieval, reranking, and top-k.
  • High retrieval noise: Check whether queries are too broad, chunks too large, metadata filters too loose, similarity thresholds poorly chosen, or ranking weak. Excess context can bury useful passages and add cost.
  • Good retrieval, weak grounding: Check whether context assembly truncates or obscures evidence, whether prompt instructions encourage unsupported completion, and whether citations point to passages that support the claims.
  • Grounded but irrelevant answers: Inspect question interpretation and answer format, and make sure the rubric rewards directness and task completion.
  • Strong offline scores, weak live results: Compare test questions and document freshness with real traffic. Look for distribution shift and review user-reported failures; a public benchmark alone does not establish application-specific reliability.

Phoenix’s RAG evaluation guide describes retrieval failures such as finding no relevant documents, retrieving only part of the evidence, or returning the wrong chunk. It also describes generation failures including hallucination, ignored context, incompleteness, and incorrect synthesis. Debug retrieval first because generation depends on the evidence retrieval supplies.

What to compare when choosing an evaluation tool

Tools answer different needs, and the available documentation does not establish an independent head-to-head winner, an independently verified accuracy ranking, or a current price comparison.

  • Does the tool evaluate retrieval, generation, or both?
  • Does it require reference answers or relevance labels, or can it use reference-free judges?
  • Can you control the judge model, rubric, and custom metrics?
  • Can it connect evaluations to traces, experiments, CI, and production feedback?
  • Can reviewers inspect individual examples and disagreements?
  • Do data handling, deployment constraints, and operational cost fit your application?

Ragas documents a broad metric catalog and custom metric support. Phoenix documents pre-built evaluators integrated with tracing and experiments. NVIDIA documents a Ragas-based approach for a particular blueprint. Choose based on evaluation needs and workflow fit, not an unsupported claim that one product is universally best.
