Enrich only when an external source can answer a defined question, and review uncertain matches instead of treating them as facts. This workflow works in a visual tool such as OpenRefine or in a repeatable script.
1. Preserve the raw extract and record its origin
Keep the scraped files unchanged as read-only inputs. Work on a copy or in a separate project so you can compare the cleaned dataset with what the scraper actually returned.
Record enough context to identify and reproduce the batch: retrieval date, source page or endpoint, query or scrape configuration, and a batch identifier. Store these in a manifest or appropriate provenance columns. A source filename or URL is useful, but by itself does not capture complete provenance.
When a transformation could lose information, retain the original field and write the cleaned value to a separate column. This makes later corrections and audits much easier.

2. Import the data and verify parsing
Choose an importer that matches the content, not merely the file extension. Before editing, inspect the import preview for headers, delimiters, row boundaries, malformed characters, unexpected columns, and values that have been split or joined incorrectly.
OpenRefine is a visual option for this work. Its importer supports formats including CSV and TSV, JSON, XML, spreadsheets, and RDF, with additional formats available through extensions. When importing multiple files, it can retain source filenames or URLs. Check the current OpenRefine manual for its import and project details.
Fix character encoding before cleaning text
If text displays as garbled characters, test the import encoding before normalizing or replacing values. OpenRefine’s import instructions include UTF-8, UTF-16, and ASCII as selectable encodings. Cleaning mojibake as though it were source text can turn a parsing problem into permanent data corruption.
3. Profile values before changing them
Use filters, facets, and sorting to understand what is actually in each field. Look for missing values, inconsistent capitalization, extra whitespace, punctuation differences, mixed date formats or units, duplicate records, and values that violate the field’s expected type.
Write down the intended rules before applying broad edits. For example, decide whether category labels should be lowercase, which date format the destination expects, and whether blanks mean unknown, not applicable, or an extraction failure. Those meanings should not be collapsed into one generic empty value.

- Check distributions and unusual values, not only a few representative rows.
- Preserve original columns when normalization, parsing, or conversion might be lossy.
- Define the expected meaning of one row before deduplicating or reshaping data.
4. Clean and transform with explicit rules
Start with reversible, low-risk fixes such as trimming whitespace and correcting clear formatting inconsistencies. Then standardize categories and dates according to the destination schema. Split a field when it combines distinct facts; join fields only when the target schema calls for it. Reshape rows or columns only after defining the intended record structure.
Use clustering to find variants, not to approve them automatically
OpenRefine can cluster similar values to surface likely spelling or formatting variants. Inspect the proposed groups before merging: similar strings may refer to different people, organizations, places, or products. Apply a canonical value only when the records genuinely represent the same thing.
Keep consequential edits reversible
Row deletion, permanent reordering, and overwriting source values can make a dataset difficult to audit. Retain an edit history or write transformed output to a separate file. OpenRefine saves changes in its project rather than changing the original imported source, and its project archive includes edits and history.
5. Deduplicate according to record identity
Decide what a unique record represents before removing duplicates. Prefer a stable source identifier when one exists. Otherwise, define a candidate key from fields that should jointly identify a record, then inspect collisions to confirm that the key does not combine distinct records.
Exact duplicate rows and likely duplicates are different cases. Similar names alone are not sufficient evidence to merge records; keep uncertain pairs for review and record the rule used for removal or consolidation.

6. Enrich only for a defined purpose
Enrichment adds information from an external source, such as an identifier or related property for a matched organization, person, or place. Choose an authority suited to the entity type and the information you need. Clean and cluster your source values first: misspellings, whitespace, and extraneous characters can interfere with matching.
OpenRefine supports reconciliation against external services and can use matches to add related data. Its documentation describes reconciliation as semi-automated: the software proposes matches, but human judgment is required to review and approve them. Consult the OpenRefine reconciliation documentation for the workflow.
- Review ambiguous candidates, particularly when multiple entities have similar names.
- Keep unmatched and uncertain values distinguishable from accepted matches.
- For accepted matches, retain the authority’s identifier and record the source and retrieval date.
- Check the service’s documentation, rate limits or throttling guidance, and terms before making requests at scale.
Enrichment can make a dataset less reliable if uncertain matches are silently treated as ground truth. Do not add columns simply because a service offers them; each added field should serve a stated downstream use.
7. Validate against the intended use, then export
There is no universal quality threshold for every scraped dataset. Set checks based on what will consume the output, and run them after transformations and enrichment.
- Required fields are present, with blanks interpreted according to an explicit rule.
- Values have the expected types and formats, such as valid dates or numeric fields.
- Uniqueness constraints hold for the chosen record identity.
- Row counts and category distributions have no unexplained changes.
- Enrichment matches, blanks, and unresolved candidates have been reviewed.
Export to the format and schema the next system requires. OpenRefine can export cleaned data; its project archive can preserve edits and history when sharing that history is appropriate. If the edit history or original state should not be exposed, export only the cleaned dataset rather than sharing the project archive.

Choosing a workflow: visual or scripted
OpenRefine can suit exploratory cleanup and moderate one-off transformations when a visual interface is useful. A scripted Python workflow can be preferable when the same rules must run repeatedly and be version-controlled. The right choice depends on how often the process repeats, team skills, dataset size and runtime constraints, collaboration needs, available enrichment authorities, and whether the workflow preserves source values and can produce the required output schema.
OpenRefine’s manual says a local project cannot be accessed by multiple people simultaneously. Projects can be exported and imported with edit history, but that is different from simultaneous collaborative editing. Dataset-size limits and a direct current comparison of Python libraries are not established here; test the actual workload and chosen tools before committing to a production process.

Common problems and fixes
Imported columns or rows are malformed
Return to the import preview and check the parser, delimiter, quoting, headers, and row boundaries. Correct the import settings before making cleanup edits.
Text appears corrupted
Re-import or adjust the encoding, testing the encodings offered by the importer. Do not normalize the garbled values until the text displays correctly.

Clustering merges distinct values
Review each proposed cluster and separate entities that only look alike. Use an identifier or additional stable fields where available; do not accept a cluster based on name similarity alone.
Deduplication removes valid records
Revisit the definition of one row and the key used to identify it. Check collisions before deletion, and use a source identifier when it reliably represents record identity.
Enrichment returns ambiguous or missing matches
Keep uncertain results unresolved rather than assigning a potentially incorrect entity. Review candidates, preserve the authority identifier for accepted matches, and retain source and retrieval-date information.
