The original tutorial, published July 6, 2021, uses a music-genre classifier and Heroku hosting. Its FastAPI code remains a useful learning example, but Heroku commands, runtime support, pricing, limits and dashboard labels must be checked against current Heroku documentation before production use.
This guide separates the durable application pattern from the tutorial’s historical platform steps.
How the deployment works
The API should not retrain a model for every request. Train and evaluate the estimator separately, save the trusted artifact, load it when the web process starts, then serve predictions over HTTP.
- A client sends feature values as JSON.
- FastAPI validates the request against a Pydantic schema.
- The application arranges features in the exact order used during training.
- The serialized estimator returns a prediction.
- FastAPI returns JSON to the client.
FastAPI also generates an OpenAPI schema and an interactive Swagger UI at /docs. The relevant technologies are OpenAPI and Swagger UI—not “Swagger and OpenAI.”

The source example classifies music using eight floating-point features: acousticness, danceability, energy, instrumentalness, liveness, speechiness, tempo and valence. It describes genres including Rock and Hip-Hop, but the actual label depends on the model artifact.

Prepare a model that can be served safely
Serialize the complete inference pipeline
Save preprocessing and the estimator together when possible. A scikit-learn Pipeline prevents serving code from silently changing scaling, encoding, missing-value handling or feature order. Record the Python, scikit-learn, NumPy and SciPy versions used to create the artifact, then verify that a clean environment can load it and produce known predictions.
Understand pickle’s trust boundary
pickle.load() can execute arbitrary code during deserialization. Load only an artifact produced by a trusted build process, keep it out of user-upload paths, verify its integrity, and restrict who can replace it. Pin compatible dependency versions; a successful HTTP response does not prove that the model is compatible or correct.

Choose where the file lives
A small model can be included in the deployment artifact. Large files may be impractical for a source repository or application slug; in that case, fetch a versioned artifact from secured object storage during startup. Never assume the file is present merely because the application code is present.

Use a path derived from __file__, not the process’s current working directory, so startup works regardless of where the server is launched.
Build the FastAPI application
The following implementation keeps the model loaded once per process, adds a health route, and uses a stable path for the artifact:

Why the schema matters
The Music class documents the request body and lets FastAPI reject missing or incorrectly typed fields with a 422 response. Pydantic type checks are not the same as domain validation: they do not prove that a value is finite, within the training distribution, in the right units or semantically meaningful. Add explicit bounds and finite-number checks where the model requires them.

The source tutorial uses data.dict(). In Pydantic versions that support it, model_dump() is the modern replacement; choose the method that matches the pinned Pydantic major version. The explicit feature list above makes ordering visible rather than relying on dictionary order.
Run and test it locally
Start Uvicorn
- Install the tested dependencies in a virtual environment.
- From the project root, run

Historical Heroku files and workflow
The 2021 article describes requirements.txt, runtime.txt and a Procfile, then a GitHub-connected Heroku application and branch deployment. Treat those details as historical conventions; verify current runtime declarations, build behavior, supported Python versions, plan limits and deployment UI with Heroku and its pricing page.

Do not publish placeholder versions as if they were current recommendations. Serialization compatibility spans Python, scikit-learn, NumPy and SciPy.
Process command
For main.py containing an application object named app, the historical pattern is:

Four workers are not a universal recommendation. Each worker can load its own model copy, multiplying memory use. Size workers for model memory, CPU, concurrency and the platform allocation.
Deployment sequence
- Put the application, tested dependencies, process definition and model artifact—or a secure startup download mechanism—in the deployment source.
- Create or select the Heroku application using the currently supported workflow.
- Configure secrets and other settings as environment variables, never in source code.
- Build and deploy.
- Inspect build and runtime logs.
- Check the root health endpoint and
/docs. - Send a real POST request to
/prediction.
The source’s “Deploy Branch” wording and its use of runtime.txt should not be assumed to match the 2026 dashboard or build system.

Troubleshoot the failures you are most likely to see
Boot failure
Inspect logs with heroku logs --tail where that command is supported. Check the Procfile module path, Gunicorn installation, import errors, runtime compatibility and whether the model file exists in the deployed artifact.
Missing package or model
A ModuleNotFoundError means the imported package is absent from the dependency file or the build was not recreated. A file-not-found error usually means a fragile relative path, incorrect filename case or an omitted artifact. Resolve paths from __file__ and verify the built contents.
Unpickling failure
Recreate the serving environment with the training versions, or retrain/export the model under a controlled set of versions. Do not “fix” an incompatible artifact by accepting arbitrary files.
422 validation response
Compare the JSON body with the schema shown in /docs. Required fields must be present and numeric values must match the declared types.
Correct HTTP response, wrong prediction
- Verify feature order, units and scaling.
- Confirm category encoding and missing-value handling.
- Check that preprocessing is included in the serialized pipeline.
- Compare the serving schema with the training schema.
- Preserve the expected label mapping.
Memory exhaustion, slow requests or timeouts
Reduce worker count, avoid duplicate model loads, optimize or shrink the model, and measure inference separately from network time. Long-running jobs may need batching, a background queue or dedicated inference infrastructure. GPU or very large models are unlikely to fit a basic web process.
Production checklist
- Pin and regularly rebuild tested dependencies.
- Version the model and provide a rollback path.
- Return or expose model-version metadata where clients need reproducibility.
- Add authentication, HTTPS, rate limiting, request-size limits and restrictive CORS settings.
- Log latency, status codes, model version and errors without recording sensitive payloads.
- Monitor data and concept drift, not just server uptime.
- Use health checks that distinguish process health from model-load health.
- Load only trusted, integrity-checked artifacts.
- Evaluate the candidate model before promotion.
When Heroku is the wrong fit

Render, Railway, Fly.io and similar services can be alternatives for container or Git-based deployment, but compare their current pricing, regions, sleep behavior and memory limits directly before choosing one. FastAPI’s broader deployment ecosystem also changes over time; its release information is available at FastAPI release notes.
Bottom line
Keep the FastAPI pattern: load a trusted, versioned pipeline once, validate a clearly documented request, expose health and prediction routes, and test locally before deployment. Treat the Heroku portion of the July 2021 tutorial as a dated example rather than a guarantee of current platform behavior. For production, reproducibility, security, observability, model lifecycle controls and resource sizing matter more than the hosting brand.
