Quality is not a single score: it is whether data is fit for its intended use. NIST notes that quality directly affects a dataset’s fitness for purpose, usability, and reusability in its Research Data Framework, revision 2.0.
What does high data quality mean?
High-quality data is sufficiently trustworthy and usable for the decision, report, model, or service that depends on it. The required level varies by use: a field that can be approximate in an exploratory analysis may need strict validation in a regulated report or operational system. Set targets according to the consequences of errors, user needs, available resources, time, and privacy constraints rather than pursuing perfection without regard to cost.
Use six dimensions as a practical starting vocabulary. The UK Government implementation guide recommends beginning with these DAMA UK dimensions, while NIST describes additional attributes such as relevance, reliability, appropriate presentation, and accessibility. Add domain-specific criteria when the data’s purpose requires them.

These dimensions are related but not interchangeable. A record can be complete and valid in format yet inaccurate in fact; consistency between two systems does not prove that either is correct.

How to build a data-quality practice
1. Define purpose, critical data, and accountability
List the decisions, reports, models, or services that use each important dataset. Identify critical fields, required freshness, tolerable error levels, applicable legal or contractual constraints, and the people responsible for the asset. A target is useful only if it reflects the consequences of failure and has an accountable owner.
2. Profile the current state before making changes
Measure a baseline before cleaning or transforming data. Useful checks include missing-value rates, duplicate rates, format and range violations, stale records, and disagreements across sources. Focus first on fields that drive high-impact decisions. Use sampling or targeted checks when inspecting every record would be too costly, and document the method so later measurements can be compared fairly.

3. Convert quality expectations into executable rules
Write each expectation as a test that can be evaluated consistently. Examples include requiring a customer identifier, checking that a birth date is valid and not in the future, restricting country codes to an approved list, ensuring a customer key maps to one entity, reconciling totals across systems, and enforcing a freshness window. The UK Government’s implementation guidance uses entry within three days of collection as an example of a timeliness rule; that is an illustration, not a universal threshold. 4. Prevent defects at capture and check each handoff
Use controlled vocabularies, input constraints, reference-data checks, and schema validation where data is first entered or generated. Detect likely duplicates early. Then repeat checks after ingestion, transformation, integration, and publication: a source can be sound while a mapping, conversion, or join introduces defects. NIST’s Research Data Framework includes verification and validation, cleaning, metadata normalization, documentation, and quality assessment as lifecycle activities.

5. Monitor exceptions and correct causes
Track dimension-level results and exception counts over time. Set thresholds that trigger alerts, route issues to named owners, and record whether remediation is completed. When the same defect recurs, investigate the source process, interface, mapping, or definition rather than repeatedly editing individual records. Reprofile after material changes to a source or pipeline.
6. Maintain definitions, lineage, and protection
Keep a business glossary, schemas or data contracts, source and transformation lineage, stewardship assignments, and change history. These records help users interpret fields, trace how values were produced, and reproduce results. Protect data against unauthorized access or revision. 7. Review thresholds when needs or trade-offs change
Faster publication can leave less time for checks; stricter validation can delay availability or exclude records that do not meet a rule. Timeliness, accuracy, and coverage can therefore compete. Document accepted exceptions and the reason for them, then revisit thresholds when the use case, risk, or source process changes. The UK framework discusses these trade-offs in its data-quality framework.
What should teams automate?
Automate repeatable checks whose failures can be detected clearly and acted on by an owner. The precise thresholds should come from the data’s use, not a generic default.

- Presence: required-field and required-record checks.
- Uniqueness: duplicate detection on keys or defined combinations of fields.
- Validity: data types, formats, permitted values, and range checks.
- Consistency: cross-field logic and reconciliation between systems or reports.
- Timeliness: arrival-time or last-updated checks against an agreed freshness window.
- Change monitoring: shifts in null rates, duplicates, exceptions, or other baseline measures after source or pipeline changes.
Automation should surface actionable exceptions, not merely produce a pass/fail badge. Include the failing rule, affected records or counts, responsible owner, and a route to remediation. Keep human review for questions that require judgment, such as whether an exception is acceptable for a particular decision.

Maintain a baseline and track the same rules consistently so a trend reflects a real change rather than a changed measurement method. A practical monitoring loop is:
- Run scheduled checks at appropriate points in the data lifecycle, including after ingestion or transformation.
- Compare results with documented thresholds and prior measurements.
- Alert the steward or owner when a threshold is breached, and preserve enough context to investigate.
- Record the cause, decision, and remediation; distinguish an accepted exception from a corrected defect.
- Re-run checks after remediation and verify that the fix did not create problems elsewhere.
- Reprofile when a source, schema, integration, or intended use changes materially.
Monitor dimensions separately where possible. A single composite score can conceal a serious weakness—for example, an overall improvement that masks worsening timeliness in a critical feed.
How do data-quality frameworks differ?
Frameworks can complement one another rather than compete. Select one according to the questions your organization needs to answer, and compare frameworks or tools against scope, dimensions, measurement, governance, and operational fit.

When evaluating a framework or a data-quality tool, compare profiling depth, rules and threshold support, lineage and metadata, monitoring and alerting, remediation workflow, stewardship and access controls, auditability, integration options, cost, and fit with sector or regulatory requirements. A tool can help execute checks, but it cannot decide which errors matter or who is accountable for fixing them.
