A recurrent neural network (RNN) reads an ordered sequence one step at a time, carrying a hidden state forward so each step can use information derived from earlier inputs. Vanilla RNNs, LSTMs, GRUs, and bidirectional RNNs all build on that idea, but differ in how they preserve information, use context, and fit the task. No variant is best for every problem: choose based on whether the full sequence is available, how long useful dependencies span, and measured quality and cost on your workload.

What is a recurrent neural network?

An RNN is a neural network designed for ordered data. At each time step, it combines the current input with a hidden state carried from the previous step, then produces an updated hidden state. That state summarizes information from earlier steps and can influence later outputs.

The network reuses the same learned recurrent weights at each sequence position. This lets it process sequences of different lengths without requiring a separate set of parameters for every position. Common examples of sequential problems include language, speech, translation, sequence generation, and time-series analysis; these are application areas, not a claim that RNNs outperform other model families on them.

How does a vanilla RNN work?

A vanilla RNN applies a repeated update: the current input and previous hidden state are combined to calculate the next hidden state. An output can then be produced from that state, either at every step or at selected steps, depending on the task. The same update is applied across the sequence.

This simple recurrence is useful for modeling order, but it can make long-range dependencies hard to learn. Information from an early input must pass through many repeated updates to affect a later output, and training signals must travel back through those same steps.

How does backpropagation through time work?

Backpropagation through time (BPTT) trains a recurrent network by conceptually unrolling its repeated computation across sequence positions. The model calculates losses and propagates gradients backward through the unrolled steps; a later output’s gradient can therefore pass through earlier hidden states. NVIDIA’s RNN overview describes this process.

As the gradient travels across many recurrent steps, repeated multiplication can make it shrink toward zero or grow rapidly. These are the vanishing and exploding gradient problems, respectively. Both can make it difficult to learn relationships between far-apart sequence elements. Pascanu, Mikolov, and Bengio analyze these issues in their 2013 paper, On the difficulty of training recurrent neural networks.

What is the vanishing gradient problem?

The vanishing gradient problem occurs when training gradients become very small as they are propagated backward through the sequence. Earlier steps then receive little learning signal from later losses, so the model may struggle to learn dependencies that span many steps. The exploding gradient problem is the contrasting case: gradients grow excessively and can destabilize training.

Gradient norm clipping can limit excessively large gradients and is a remedy for exploding gradients; it does not, by itself, solve vanishing gradients. Pascanu and coauthors discuss clipping for exploding gradients and a soft constraint aimed at the vanishing-gradient problem. The appropriate method depends on the model and training setup.

How do LSTMs address long-range dependencies?

A Long Short-Term Memory network (LSTM) adds a cell state and gates that control what information is added, retained, and exposed. The gates provide routes for information to persist across recurrent steps, helping address the difficulty of preserving useful signals in a basic RNN.

The original LSTM paper by Hochreiter and Schmidhuber reported learning minimal time lags in excess of 1,000 discrete-time steps under the paper’s stated experimental conditions. That historical result illustrates the design’s motivation; it is not a guarantee that an LSTM will retain useful information over a particular span in a modern task or implementation. What is the difference between LSTM and GRU?

A Gated Recurrent Unit (GRU) is another gated RNN variant. In NVIDIA’s overview, a GRU is simpler than an LSTM, has fewer parameters, lacks a separate output gate, and combines the cell state with the hidden state. The overview characterizes GRUs as faster to train, but that is not a universal speed guarantee across hardware, software, sequence lengths, or implementations.

Parameter count alone does not establish which gated model will produce better results or lower total runtime. Compare the variants using the same data splits, task metrics, implementation, and hardware.

When should I use a bidirectional RNN?

A bidirectional RNN runs one recurrent network forward through a sequence and another backward, then combines their outputs. A representation at a given position can use both preceding and following inputs. This is useful for offline analysis when the complete sequence is available.

It is not appropriate when an output must be strictly causal and future observations have not arrived. In that setting, use a model that predicts from past and current information only. Bidirectional models are described in NVIDIA’s technical overview and in the sequence-modeling chapter of Deep Learning.

What are deep RNNs and other recurrent configurations?

A deep RNN stacks recurrent layers, allowing one layer’s sequence representations to feed another recurrent layer. Stacking changes model capacity and computation, but does not remove gradient challenges or the sequential dependencies involved in recurrent processing.

Simple tanh- or ReLU-based RNNs, GRUs, and LSTMs are common recurrent configurations. NVIDIA discusses these in the context of its GPU libraries, but library capabilities depend on vendor and version. Consult the current documentation for the framework and hardware you plan to use before relying on a specific implementation feature.

How should you compare recurrent models?

There is no universal ranking among vanilla RNNs, LSTMs, and GRUs. Make the comparison against the constraints and evidence for the particular task:

  • Context availability: Decide whether predictions must be made online from past and current inputs, or whether the full sequence can be read in both directions.
  • Dependency span: Identify how far back useful information must persist, then test whether the candidate model learns that dependency on your data.
  • Task quality: Evaluate on held-out data with metrics appropriate to the task; a result on one task does not establish a general winner.
  • Training and inference cost: Measure runtime and memory on the intended implementation and hardware. Recurrent steps depend on earlier steps, and hardware acceleration does not eliminate the need to benchmark the actual workload.
  • Model complexity: Gated variants add structure, but fewer parameters alone do not prove better accuracy or lower end-to-end cost.

Transformers and other sequence architectures are also relevant alternatives. A useful comparison considers parallelism, available context, latency, data, memory, and measured task quality; these sources do not establish a quantitative winner between architecture families.

What problems are RNNs used for?

RNN applications include natural-language processing, speech recognition, machine translation, character-level language modeling, image captioning, time-series prediction, and some financial-engineering tasks. A review chapter also discusses text classification, summarization, and image-to-text translation. These examples reflect problems with sequential structure, not an exhaustive list or a current performance leaderboard.
