Regression predicts a numeric value from input features. Regularization modifies how a regression model is fitted by penalizing large coefficients, which can make estimates more stable when predictors are noisy or strongly correlated. Ridge shrinks coefficients, Lasso can set some to zero, and Elastic Net combines both penalties. The right choice depends on validation performance and what you need from the model.

What regression does—and where ordinary least squares can struggle

A linear regression model multiplies each feature by a coefficient, then combines those weighted values, usually with an intercept, to predict a numeric target. Ordinary least squares (OLS) chooses coefficients to minimize the residual sum of squares: the squared differences between observed values and predictions. The scikit-learn 1.9.1 stable linear-model documentation describes this baseline and regularized alternatives.

When predictors are strongly correlated, the design matrix can be close to singular. Then small changes or noise in the observed targets may produce large changes in the estimated coefficients. A model may fit the data it was given while its weights remain unstable.

What regularization changes

Regularization adds a penalty for coefficient size to the fitting objective. This discourages extreme weights and can stabilize estimates, particularly with noisy data or correlated predictors. It does not guarantee better predictions: stronger constraints can reduce variance but introduce bias, and an overly strong penalty can underfit.

The penalty strength is a parameter to select using validation data; there is no universally best value. In scikit-learn’s current linear-model documentation, the parameter is commonly named alpha, and a larger alpha means stronger shrinkage for Ridge.

OLS, Ridge, Lasso, and Elastic Net compared

Method Penalty Effect on coefficients When it may be useful
Ordinary least squares None Minimizes residual sum of squares; estimates can be unstable with correlated features. A baseline when a plain linear fit is appropriate.
Ridge L2: squared coefficient magnitudes Shrinks coefficients; larger alpha means more shrinkage. When correlated features or unstable estimates are a concern and retaining all features is acceptable.
Lasso L1: absolute coefficient magnitudes Can set coefficients exactly to zero, producing a sparse model. When a more compact set of features is useful, provided predictive performance is validated.
Elastic Net A combination of L1 and L2 Can produce sparse coefficients while retaining Ridge-like properties; l1_ratio controls the mix in scikit-learn. When a sparse fit is desired and predictors may be correlated.

With correlated features, Lasso may select one feature over another, while Elastic Net is more likely to retain multiple correlated features. These are tendencies, not guarantees for every dataset. Definitions and implementation terminology above follow scikit-learn’s 1.9.1 stable linear-model documentation.

How to choose the penalty and evaluate the model

Keep model selection separate from final evaluation. The scikit-learn developers’ validation-curve guidance warns that repeatedly using a validation score to select hyperparameters makes that score biased as an estimate of generalization; a separate test set is needed for a proper final estimate.

  1. Set aside test observations. Do not use them to choose a method, features, or hyperparameters.
  2. Fit candidates on training data. Compare OLS, Ridge, Lasso, and, where relevant, Elastic Net.
  3. Select hyperparameters using validation. Use cross-validation or a validation set to choose alpha. For Elastic Net, tune l1_ratio as well.
  4. Compare what matters for the task. Consider validation prediction error alongside coefficient stability, sparsity, and whether the model’s structure is useful for your purpose.
  5. Evaluate the selected approach once on the untouched test set. Treat this as the final estimate of performance on unseen data, not another opportunity to tune.

Scikit-learn’s OLS and Ridge example illustrates a train/test split and reports mean squared error and the coefficient of determination for its particular diabetes-data example. Those scores describe that example, not a general benchmark or a prediction of how either method will perform on another dataset.

Choosing between Ridge and Lasso

Start with Ridge when keeping features is acceptable

Ridge is a reasonable candidate when predictors are correlated or coefficient estimates seem unstable, and you do not need the model to eliminate features. It shrinks coefficients rather than using the L1 penalty to force some to zero.

Try Lasso when sparsity is useful

Lasso can create a model with fewer nonzero coefficients. That compactness can be useful, but it is not proof that the selected features are uniquely important—especially when predictors are correlated. Compare predictions on validation data, rather than choosing Lasso solely for a shorter coefficient list.

Consider Elastic Net for correlated predictors and a sparse fit

Elastic Net combines L1 and L2 penalties. It is worth comparing when you want sparsity but also have correlated predictors; its greater tendency to retain more than one such feature is not a guarantee. Validate both its penalty strength and the L1/L2 mix.

An optional Bayesian view of Ridge

Ridge’s L2 penalty can also be understood probabilistically: scikit-learn describes Ridge as equivalent to maximum a posteriori estimation under a Gaussian prior on the coefficients. This interpretation is not necessary to apply Ridge, but it connects the penalty to an assumption that coefficients are more plausibly near zero than extremely large.
