Clean a dataset by protecting the original, checking how it was imported, profiling its contents, applying explicit rules to confirmed problems, and validating and documenting every change. Do not automatically delete duplicates, replace missing values, or remove extreme values: those decisions depend on what each row represents and what you plan to analyze.
1. Preserve the original and identify what the data means
Make an untouched, read-only copy of the source file, then clean a separate working copy. Record where the data came from, when it was collected, the units used, and any known collection or export conventions. This gives you a reference if a transformation goes wrong or a result needs to be checked.
Keep the row and column meanings in view as you work. A tidy layout usually has one variable per column, one observation per row, and one kind of observational unit per table; that structure makes data easier to manipulate and analyze, as Hadley Wickham explains in the university library workshop’s reproduction of his guidance.
OpenRefine imports information into a project rather than editing the original file, according to its starting guide. That separation is useful, but it is not a substitute for protecting sensitive data: project archives may retain original state and edit history, so avoid sharing an archive if it could reveal information you meant to anonymize.

2. Verify the import before interpreting values
A file can look messy because it was parsed incorrectly. Before editing records, confirm that the rows, columns, and values match the source’s intended structure.
- Check the delimiter, header row, text encoding, and worksheet.
- Confirm that each row and column has the meaning you expect; a spreadsheet may contain multiple worksheets or introductory notes above the actual table.
- Look for identifiers that should remain text. Converting an ID such as
00127to a number would discard meaningful leading zeros. - Check whether formatting in the original—such as cell colors—carries meaning, since importing data may not preserve that formatting.
OpenRefine may infer a parser from a file’s extension or contents, but its import options let you choose a separator and encoding. It imports one worksheet from a multi-sheet spreadsheet, and the import does not preserve formatting such as cell colors; see its import and project documentation. If the workbook has meaningful information on several sheets, check them separately rather than assuming they all arrived in one imported table.
3. Profile the data before changing it
First take an inventory. Note the number of rows and columns, field names, representative records, distinct categories, ranges, missing values, and possible duplicates. This is the baseline you will compare against after cleaning.
For each column, decide whether it is an identifier, date, number, category, or free-text field. The same value can require different handling depending on its role: a numeric-looking account code may be an identifier, not a quantity. OpenRefine’s exploration tools include facets, filters, and sorting to help inspect values before making changes; its documentation describes the broader workflow.

Exploration is part of cleaning, not a detour. A frequency table may reveal inconsistent category labels; a range check may expose mixed units; a small sample of rows may reveal that the header was misread. Record what you observe before applying bulk edits.
4. Standardize formats only when the intended value is clear
Use explicit rules to normalize whitespace, spelling, units, category labels, dates, and numeric formats. For example, if “NY,” “N.Y.”, and “New York” are confirmed to mean the same place in this dataset, standardize them to one label. Do not merge variants merely because they look similar.
OpenRefine supports cell edits, transformations, splitting and joining columns, reshaping, and clustering. Its documentation notes that types can vary at the cell level, so converting an entire column does not guarantee every cell will parse successfully. Check the results of a conversion and leave ambiguous values for review rather than silently coercing them. See the exploration guide and transformation guide.
Keep a record of each rule, such as “trim leading and trailing spaces in the city field” or “convert dates in month/day/year format to ISO format after verifying the source convention.” A rule should be understandable and repeatable—not simply a sequence of clicks whose meaning is forgotten later.

5. Decide what missing values mean
Blank cells, “N/A,” “unknown,” zero, and false are not automatically interchangeable. A blank may mean not collected; “unknown” may mean a respondent could not answer; zero may be a real measurement. Standardize missing-value tokens only after establishing whether they represent the same condition.
Count missing values by field and, where useful, by row. Then investigate why they are absent and decide whether the analysis should leave them missing, exclude affected records, or impute values. The right choice depends on the question and how the data was collected; there is no universal imputation recipe supported by the sources here.
In pandas, missing-value markers vary with data type. Use isna() or notna() to detect missing values instead of relying on equality comparisons with np.nan, NaT, or pd.NA. See the pandas missing-data guide.
6. Investigate duplicates and unusual values in context
Define what makes a record unique
Exact duplicate rows are not necessarily redundant. Repeated measurements, transactions, or events may be legitimate observations. Before removing anything, define what one observation represents and which fields form the key that should be unique. Then check for exact duplicates and near-duplicates against that rule.

Use clustering as a review aid
Similar text values may refer to the same entity, but similarity is not proof. OpenRefine’s clustering can group strings that look alike; a person still needs to decide whether they should be merged. For example, two organization names may be spelling variants—or two different organizations with similar names. The transformation guide describes clustering and other editing operations.
Investigate outliers rather than deleting them automatically
An extreme value could be a typo, a unit mismatch, or a real but unusual observation. Compare it with the source documentation, units, other fields, and plausible domain bounds. Correct or remove it only when evidence supports that decision, and document why. The reviewed sources establish neither a universal statistical cutoff for outliers nor a single rule that works for every dataset.

After each meaningful round of changes, compare the result with your baseline and check the rules that matter for your analysis. A practical validation checklist includes:
- Row and column counts, including whether any records were intentionally removed.
- Field types and formats, with a review of values that failed to convert.
- Allowed categories and expected ranges.
- Key uniqueness, if the chosen key should identify one observation.
- Missingness by field and any relationships that should hold between columns.
- Before-and-after summaries and a sample of changed records.
Look for unintended consequences: a conversion may have turned valid identifiers into numbers, a deduplication may have removed repeat events, or a category merge may have combined distinct groups. OpenRefine keeps project history and supports undo; its transformation documentation covers these operations. 8. Choose a tool for the workflow you need
OpenRefine is suited to visual exploration and hands-on transformations of tabular data. Its documentation covers import, facets, clustering, transformations, and export (manual). The project runs locally according to the starting guide, but privacy still depends on your choices—for example, whether you fetch external data or share a project archive.
pandas is suited to programmatic cleaning that can be repeated and integrated with analysis. Its user guide and missing-data documentation cover data operations and type-aware missing-value handling. A script can make the sequence of transformations easier to rerun and review, provided you keep the code and inputs organized.
Choose based on the actual task rather than a supposed universal size limit. Consider whether you need visual review or automation, how your team works, the input and export formats, privacy requirements, and how clearly you can preserve an audit trail. The cited documentation does not establish a controlled performance comparison or a universal dataset-size cutoff for these tools.
9. Keep an audit trail and share the right artifact
Maintain a change log or reproducible script that records what changed and why. Keep the raw source separate from the cleaned output, and export a cleaned dataset when collaborators need the results rather than the editing project. Before sharing an OpenRefine project archive, consider whether its original data or history could expose protected information; the starting guide specifically cautions about this risk.
