Adaptive device selection in federated learning is the process of choosing which client devices will train and send model updates in each round, using information such as device speed, network conditions, and the expected usefulness of local data. Rather than selecting participants only at random, a server uses these signals to meet a training goal—such as completing rounds on time or reaching useful accuracy sooner.

What device selection means in federated learning

Research papers usually call device selection client selection or participant selection. In a typical round, the server selects a subset of clients, sends them the current model, and receives their locally trained updates for aggregation. The process repeats across rounds, with a new group potentially selected each time.

Local training means the clients’ raw training data stays on their devices in the studied protocols. That fact alone is not a complete privacy guarantee: selection describes who participates, not every privacy or security property of the overall system.

What makes selection adaptive

A basic system may sample clients without considering whether they can finish promptly or how informative their data is. An adaptive system uses information about candidate clients to shape the next group. Depending on the method, that information may include:

  • Device computation capacity and estimated local training time.
  • Wireless channel quality, upload speed, and likely communication time.
  • The amount or type of task-relevant local data available.
  • An estimate of how much a client’s data may improve the model.

These signals support different objectives. Resource-aware selection aims to make participation feasible within a round; utility-guided selection aims to favor data expected to help the model. A method may combine both.

How FedCS selects clients under resource constraints

FedCS, introduced by Takayuki Nishio and Ryo Yonetani in 2018, focuses on resource constraints in mobile-edge settings. It asks candidate clients for resource information, estimates the time needed to distribute the model, perform local updates, and upload results, then selects clients expected to finish before the round deadline. Its goal is to admit as many updates as possible within those constraints.

The paper describes a greedy selection heuristic and evaluates it in a simulated mobile-edge environment using publicly available image datasets. It reports significantly shorter training time in that evaluation, but the cited summary does not establish a universal percentage improvement. The analysis includes assumptions about network stability, so its schedule should not be treated as a ready-made policy for every mobile deployment. Read the FedCS paper.

How Oort combines data utility and device speed

Oort, presented by Fan Lai, Xiangfeng Zhu, Harsha V. Madhyastha, and Mosharaf Chowdhury at USENIX OSDI 2021, considers both the expected utility of a client’s data for improving accuracy and the client’s ability to train quickly. In the authors’ words, Oort prioritizes clients with useful data that can run training quickly.

The Oort project page reports 1.2×–14.1× improvement in time-to-accuracy and 1.3%–9.8% improvement in final model accuracy compared with the participant-selection mechanisms evaluated in that work. These are the authors’ results for their methods, baselines, and experimental conditions—not guaranteed gains for federated learning systems generally. See the Oort paper and results.

The methods emphasize different criteria rather than establishing a universal ranking. A deadline-focused policy and a utility-focused policy answer different questions; the better fit depends on the system’s objective, available client information, and evaluation needs.

What adaptive selection changes—and why evaluation matters

Choosing participants for speed or estimated utility also affects which clients’ data contributes to training. If faster devices or higher-utility estimates are concentrated in particular parts of the population, the selected group may not reflect the broader participant pool. The effect depends on the selection rule and the data distribution; it should be measured rather than assumed.

For testing, Oort’s authors describe enforcing developer requirements on the distribution of participant data. This illustrates that selecting for efficient learning and selecting a representative group for evaluation can require distinct criteria. A deployment should define what coverage or distribution constraints matter for its own evaluation, rather than treating a fast training round as proof of broad performance.

How to choose a selection objective

  • If round deadlines are the main constraint: estimate training and communication time, then prioritize clients likely to complete within the deadline, as in the resource-aware FedCS framing.
  • If reaching useful accuracy efficiently is the goal: consider both expected data utility and the ability to train quickly, as Oort does.
  • If evaluation coverage matters: make participant-data distribution requirements explicit and assess them separately from speed or utility objectives.
  • When comparing reported results: check the method, baseline, experimental setup, and whether the evidence comes from simulation or another evaluation. Results from one paper do not establish the same benefit in a different deployment.
