The best alternative depends on what is inefficient: full self-attention’s compute and activation memory, inference-time KV-cache memory, or the architecture itself. The main options are FlashAttention for faster exact attention, sparse or linear attention for reduced or altered attention work, compact KV caches for inference memory, and state-space models such as Mamba as a replacement architecture.
Why look beyond full self-attention?
In the usual dense formulation, self-attention compares each token with every other token. As sequence length grows, the number of pairwise interactions—and the memory needed to represent them—grows quadratically. That can make long sequences expensive to train or serve.
“Efficient” can mean less arithmetic, less memory, or lower wall-clock latency. Those goals are related but not interchangeable: a method with better asymptotic scaling may not run faster on a particular GPU, and a method that saves inference memory may leave attention computation largely unchanged.

When preserving exact attention matters
FlashAttention improves how attention is executed
FlashAttention is an exact, hardware-aware attention algorithm. Rather than changing which token pairs interact, it uses tiling to reduce data movement between GPU high-bandwidth memory and on-chip SRAM. The authors describe it as an “IO-aware exact attention algorithm” in their 2022 paper. It is therefore a useful first comparison when a model needs full dense attention behavior but the implementation is limited by memory traffic or execution efficiency.

The FlashAttention authors reported a 15% end-to-end wall-clock speedup on BERT-large at sequence length 512 against the MLPerf 1.1 training speed record, a 3× speedup on GPT-2 at length 1K, and a 2.4× speedup on Long Range Arena at lengths 1K–4K. These are results reported for those specific configurations in the 2022 paper, not independently replicated, current cross-hardware comparisons or a general speedup guarantee.
What it does not change
FlashAttention changes the computation’s execution and memory traffic, not the dense pattern of interactions. It does not remove full attention’s quadratic arithmetic scaling with sequence length. Its practical benefit depends on the model, GPU, sequence length, software stack, and available kernel implementation.

When fewer token-to-token interactions are acceptable
Sparse attention
Sparse attention avoids computing every query-key pair. A method can use a fixed mask or pattern, block sparsity, or dynamic selection and routing. BigBird is a representative long-sequence design that combines local, random, and global connections.
The pattern is part of the modeling choice: omitting an interaction can also omit useful information. Further, theoretical savings do not automatically become wall-clock savings. Irregular sparsity may be difficult to exploit efficiently without suitable kernels, so compare both task quality and measured runtime on the intended hardware.

Linear attention
Linear attention is a family of methods that aims to avoid the full pairwise attention matrix and achieve linear sequence-length cost. Approaches include kernel-based reformulations or approximations, recurrent formulations, and fast-weight dynamics; they are not interchangeable algorithms.
Because these approaches change how information is represented or retained, linear scaling alone does not establish the same quality as full softmax attention—or even a faster result on a given device. Evaluate the specific method on the task and sequence lengths that matter rather than treating “linear attention” as a single performance guarantee.

When inference memory is the bottleneck
During inference, a model may retain key and value representations in a KV cache. Compact-cache methods reduce the memory pressure of that retained state, for example through compression or weight sharing. This addresses a different bottleneck from sparse or linear attention: cache compression does not necessarily reduce the computation required for each new query to use the retained cache.
Consider this family when cache capacity is the limiting resource in serving. Measure memory use and latency separately so that a smaller cache is not mistaken for a reduction in attention computation.

When replacing attention is an option
State-space models such as Mamba
Mamba uses selective state-space modeling and presents linear-time sequence modeling. It is an architecture-level alternative to attention, not a more efficient attention kernel. Consider it when the question is whether to use an attention-based sequence architecture at all, rather than how to optimize full attention inside an existing model.
The evidence cited here does not establish a universal quality or deployment winner between Mamba and attention-based models. Suitability depends on the model, task, and implementation.
How to choose and benchmark
- Identify the bottleneck. Determine whether the constraint is attention compute, training activation memory, inference KV-cache memory, or observed latency.
- Decide whether full-attention behavior must be preserved. If it must, compare an exact implementation such as FlashAttention. If changing the interaction pattern or architecture is acceptable, include sparse, linear, or state-space approaches.
- Test the actual workload. Use the target model, sequence lengths, GPU, and software stack. Measure wall-clock latency or throughput as well as memory use; FLOP counts or asymptotic scaling alone do not predict real-world speed.
- Check task quality and information use. For methods that alter attention or replace it, evaluate the intended task, including whether the model can use relevant distant information.
- Account for implementation constraints. Check whether the required kernel or method is supported and whether its sparsity pattern or hardware assumptions fit the deployment environment.
The FlashAttention paper motivates this hardware-aware approach to comparison: reducing floating-point operations alone may not improve wall-clock speed if memory movement remains the limiting factor.
