You can lower production LLM costs without lowering the quality users need—but there is no universal cost-cutting switch that guarantees it. Measure a representative workload, change one thing at a time, and keep an intervention only when it meets your quality threshold while improving cost per accepted answer and service performance.

How can you reduce LLM inference costs without sacrificing quality?

Begin by measuring what your application actually does. A cheaper model or serving technique may perform well on one task and poorly on another, so compare candidates against representative requests and a task-specific acceptance rubric.

Build a representative baseline

Include frequent requests, difficult cases, and examples that have caused failures. Record the model and prompt version, input and output token counts, retries, cache hits, latency, and whether each result passes your rubric. Track total spend per accepted result—not just the advertised price per token. A low-cost response that needs retries or is rejected may cost more in practice.

Keep the baseline available for each proposed change. Change one variable at a time, then compare task quality and error severity, cost per accepted result, latency, throughput, and operational complexity. Also check data-handling requirements against your provider’s terms and your organization’s policies; these vary by service and are not settled by a general optimization rule.

Set a quality threshold before cutting cost

Define what counts as an acceptable answer for each task, including which errors are tolerable and which require escalation. A classification task and a user-facing answer may need different thresholds. Do not treat model similarity or a good average score as proof that a change preserves quality on important edge cases.

How do you choose a less expensive model?

Model selection is a cost-quality decision. OpenAI’s models documentation describes models with different capabilities and prices; the right choice depends on the workload, not a presumption that every request needs the most capable model. The catalog and prices can change, so check the current page when making a decision.

Route requests by demonstrated need

  1. Evaluate a lower-cost candidate on representative tasks using the same rubric as your baseline.
  2. Use it for request types where it meets the acceptance threshold, including difficult examples relevant to that type.
  3. Route cases that fail the threshold—or require capabilities the candidate does not provide—to a more capable option or a review path.
  4. Monitor quality, cost, and service performance after rollout, and repeat the evaluation after provider model updates.

Do not assume two models are equivalent because they produce similar answers on a small sample. Model routing is useful only when the evaluation shows that each route meets its own task requirements.

When does asynchronous batching reduce costs?

Batching suits work that can wait, such as queued classification, evaluations, or bulk transformations. It is a poor fit when a user is waiting for an immediate response or when the task cannot tolerate delayed completion.

OpenAI’s Batch API reference describes asynchronous processing. Its published terms state a 24-hour completion window and a 50% discount for eligible requests. These are OpenAI-specific terms, not a general property of batching; confirm current eligibility, supported endpoints, limits, and pricing before relying on them.

Check the delay against the workflow

  • Identify the latest time by which each job must finish, and decide what happens if it does not.
  • Confirm that the endpoint and request type are supported by the batch service.
  • Compare the batch price with the value of delayed results, including any retries or downstream handling.
  • Keep time-sensitive requests on an appropriate synchronous path.

How does prompt caching change inference costs?

Prompt caching can reduce repeated input costs when stable context recurs exactly. It is most relevant when requests reuse a long, unchanged prefix, such as shared instructions or reference material. It is less useful when the context changes frequently or requests rarely reuse the same content.

On Google Cloud’s Claude prompt-caching implementation, a subsequent request must include identical text and images, with cache-control placement unchanged. The documented default cache lifetime is five minutes, with a one-hour option for supported models. These implementation details and prices apply to that provider’s documented service, not to prompt caching across all vendors.

Include cache writes as well as reads

Google Cloud documents cache reads as 90% cheaper than base input tokens. It lists five-minute cache writes at 25% above base input pricing and one-hour writes at 100% above base input pricing. A cache hit can therefore save money, but a write costs more than ordinary input; estimate how often content will be reused within its lifetime before enabling caching. Check the provider page for current model eligibility and terms.

Keep reusable content in a stable prefix and avoid changing cacheable text, images, or cache-control placement between requests. Measure actual hit rates and total input cost rather than assuming that a configured cache is being reused.

Which self-hosted inference optimizations should you test?

For a self-hosted model, first determine where the workload spends time and resources. Google Cloud’s inference optimization explainer distinguishes prefill—the processing of the full input, which is highly parallelized and compute-bound—from decode, where output tokens are generated sequentially and generation is memory-bound. The relevant optimization depends on which phase is limiting your workload.

Match the intervention to the bottleneck

How should retrieval and prompt changes fit into cost optimization?

Prompting, retrieval, model selection, evaluation, optimization, deployment, and monitoring are connected parts of an iterative development process. Google Cloud’s generative AI documentation describes this lifecycle. Treat prompt and retrieval changes as measured interventions rather than assumptions about cost or quality.

Retrieval-augmented generation can ground answers in relevant information and connect them to up-to-date data. But retrieved material adds input context, which can raise token use. Compare the quality benefit and the added input cost on the same representative tasks; whether retrieval is worthwhile depends on the application.

How do you decide whether an optimization worked?

Compare the changed system with its baseline using the same workload and acceptance rubric. A lower token price alone is not enough: retries, cache writes, rejected outputs, and operational work can change the real economics.

  • Quality: acceptance rate and severity of errors on representative tasks.
  • Cost: spend per accepted result, including input, output, retries, and cache-write effects.
  • Service performance: latency, completion window, throughput, and concurrency under relevant traffic.
  • Operations: the effort and control required to deploy, monitor, and recover from the change.
  • Data handling: compatibility with provider terms and organizational policy.

Keep an intervention only if it meets the task’s quality threshold and improves the outcome that matters to your service. Roll it back or narrow its use if quality, latency, or reliability falls below requirements.
