Filtering can reduce random scatter, but it cannot remove a stable bias—and smoothing can make a responsive system act too late.
What kind of sensor error are you dealing with?
Start by comparing readings with a known reference under documented conditions. Record the sensor model, installation geometry, environment, temperature, power conditions, software version, timestamps, and relevant uncertainty. That baseline helps distinguish a sensor problem from a mounting, timing, or processing problem.

These categories can overlap. For example, an apparent disagreement between two sensors may come from a bad spatial transform, a clock offset, or both—not from noisy measurements. IEEE Robotics and Automation Society guidance distinguishes the remedies succinctly: “Use calibration to remove systematic errors; use filtering/averaging to reduce random noise.”
How do you correct systematic errors?
Calibration addresses repeatable relationships between sensor output and a reference. Check bias, scale factor, and alignment rather than treating every discrepancy as generic noise. Also check the physical installation: calibration does not make a loose or incorrectly positioned sensor match the robot’s intended geometry.

- Use a reference appropriate to the sensor and the task, and record the conditions under which the calibration was performed.
- Check whether temperature, unstable power, or insufficient warm-up is affecting the readings; these are relevant controls for systematic error and drift.
- For a multi-sensor system, validate spatial transforms along with individual sensor calibration if the application depends on fused measurements.
- Keep the calibration record tied to the hardware setup and software version so a later change can be investigated rather than mistaken for ordinary noise.
There is no universal calibration interval established for all physical AI systems. Recheck when the evidence or operating history warrants it, especially after a mounting change, maintenance, vibration, or a meaningful shift in the environment.
How should you reduce random noise without making the system sluggish?
Filtering and averaging can reduce random variation, but they trade responsiveness for smoother estimates. On the IEEE Robotics and Automation Society’s educational page, averaging M independent readings with single-reading standard deviation σ is described by the illustrative relationship σ/√M. The page also notes that averaging increases latency. This relationship assumes independent readings; correlated samples do not guarantee the same reduction.
Choose filtering based on the system’s response needs, not just how smooth a graph looks. A filter that suppresses scatter but delays a change can leave an estimator or controller acting on stale information. Check the resulting response delay in the full system, especially where fast motion or control decisions matter.

How do you synchronize sensors and align their coordinate frames?
Sensor fusion only makes sense when measurements refer to compatible times and locations. A timestamp offset can make two correct readings appear inconsistent if they describe different moments. A transform error can create the same problem spatially. IEEE’s 2013 conference paper states that “the time synchronization of sensors is a crucial aspect of building a robotic system.”

- Check timestamp meaning and source. Confirm whether timestamps represent capture, arrival, or another event, and inspect offsets between streams.
- Validate the clocks. Measure synchronization behavior under the actual hardware and network configuration rather than assuming that a protocol label alone establishes accuracy.
- Validate spatial transforms. Confirm that sensor positions and orientations are expressed in the expected coordinate frames and correspond to the installed hardware.
- Test fusion as a coupled system. Compare fused estimates against a reference or known scenario; plausible individual streams do not prove that their timing and geometry agree.
NVIDIA’s approximately 2025 Holoscan Sensor Bridge article describes PTP-based synchronization achieving within 1 microsecond and often exceeding 100-nanosecond precision in the context it discusses. Those are NVIDIA-stated capabilities, not a guarantee for every PTP configuration, device, or deployment.
How can software timing create sensor errors?
A sensor can be accurate on paper while the estimate used by the robot is stale. Measure end-to-end data age and jitter at the estimator and controller, not only the sensor’s nominal sampling rate. Include acquisition, transfer, queueing, fusion, and compute time in the timing budget.

An IEEE/RSJ IROS 2022 study examined nine state-of-the-art SLAM systems and reported timing-induced degradation associated with delayed critical tasks or desynchronization in sensor fusion. Its proposed mitigations include selective fusion and temporal-budget optimization. This is evidence about the systems and conditions examined, not a universal performance ranking.
- Track whether critical tasks meet their deadlines and whether late measurements are still being fused as if they were current.
- Measure jitter as well as average latency; irregular delivery can undermine estimates even when average delay seems acceptable.
- Evaluate changes to fusion scheduling or computation against the application’s timing and accuracy needs.
How do you keep calibration valid after deployment?
Calibration can be invalidated by changes to the hardware or its environment. In particular, camera–IMU extrinsic calibration can change after vibration or other disturbances. Research on camera–IMU calibration monitoring offers one example of detecting such changes, but it does not establish a universal alert threshold.
Monitor sensor-health and calibration indicators during operation, then investigate when they show a meaningful change. Recheck after vibration, maintenance, mounting changes, or environmental shifts. The decision to recalibrate should follow evidence from the particular sensor, robot, and operating domain rather than a fixed interval assumed to fit every system.

Why should uncertainty continue through the AI pipeline?
A downstream component that receives only a most-likely perception estimate can become overconfident about what the robot will encounter. Research on trajectory forecasting describes how upstream perception uncertainty can lead to overconfident forecasts when later components do not account for that uncertainty.
Preserve relevant uncertainty in the estimates passed to planning and forecasting components, and validate how those components behave when input quality falls. A single best estimate may be convenient, but it should not silently erase uncertainty that matters to a decision.

Define a degraded-input response as part of the system’s hazard analysis and validate it for the robot and operating domain. Depending on the application, a response might alert an operator, slow, stop, or switch to a validated fallback; no one response is appropriate for every system.

NVIDIA describes flagging out-of-distribution conditions and moving to a safe operating state in its Halos system. That is one vendor’s design description, not a universal safety guarantee or proof that a given robot’s fallback is safe. The system’s response needs evidence from its own operating conditions and validation.
A practical order of operations
- Establish a reference baseline and document the hardware, installation, environment, power, temperature, software, timestamps, and uncertainty.
- Classify the observed discrepancy as systematic error, random scatter, timing or geometry mismatch, drift, or compute-induced delay; investigate overlapping causes where appropriate.
- Calibrate repeatable systematic terms and inspect the physical mounting. For fused sensing, validate clock offsets and spatial transforms together.
- Measure end-to-end data age and jitter where estimation and control use the data, then address missed deadlines or desynchronization.
- Apply filtering or averaging only when random scatter is the problem, and measure the added response delay.
- Monitor health and calibration indicators, with investigation or recalibration triggered by evidence of change.
- Preserve uncertainty downstream and validate a degraded-mode response for the intended operating domain.
When comparing remedies, weigh the error class addressed, accuracy against latency and compute cost, offline versus online operation, ability to detect change, robustness to environmental or mechanical disturbance, and how uncertainty and safety response are handled. There is no universal algorithm or product ranking established for all physical AI systems.
